Choose TensorRT for the highest NVIDIA-specific performance, ONNX Runtime for a common inference API across NVIDIA, AMD, Intel and other targets, and Vulkan when inference must share a low-level graphics or compute pipeline. TensorRT can be faster on compatible NVIDIA workloads, but its serialized engines are tied to the GPU, software stack and build settings that produced them. ONNX Runtime keeps the model and application interface more portable by selecting execution providers, while Vulkan supplies low-level GPU control rather than model parsing, graph partitioning and neural-network operators.

There is no universal speed winner. Measure the exact exported model, precision, shapes, batch size, concurrency and hardware you will ship. For a heterogeneous product, start with ONNX Runtime and add vendor-specific providers; for an NVIDIA-only service, benchmark TensorRT directly and ONNX Runtime with its TensorRT execution provider; for a Vulkan application, retain Vulkan for rendering and resource ownership and use a higher-level inference layer.

Which technology should you choose for cross-GPU inference?

Use the deployment constraint as the first decision, not a headline benchmark. A single-vendor NVIDIA deployment can justify TensorRT’s build and engine-management work. A product that must run on NVIDIA, AMD and Intel generally benefits from ONNX Runtime’s provider model. Vulkan is the right foundation when an application already owns a Vulkan rendering or compute graph and needs tight resource integration, but it is not a turnkey neural-network runtime.

Requirement Best starting point Why
NVIDIA hardware only; latency or throughput is the priority TensorRT directly It compiles the network and selects kernels for the target NVIDIA GPU.
NVIDIA hardware with a stable, higher-level application API ONNX Runtime with the TensorRT execution provider Supported ONNX subgraphs can be delegated to TensorRT while the application keeps ONNX Runtime’s interface.
One product covering NVIDIA, AMD and Intel ONNX Runtime Execution providers expose CUDA/TensorRT, MIGraphX, OpenVINO, DirectML, WebGPU and other backends behind a common model and API.
Game, visualization or media software already built around Vulkan Vulkan plus a higher-level inference runtime Vulkan handles low-level resources and synchronization; the inference layer handles model graphs and operators.
Prebuilt inference artifacts distributed to many machines ONNX Runtime, or a carefully managed TensorRT build farm ONNX models are more portable; TensorRT engines must be rebuilt or revalidated for changed targets and software.

These choices are not mutually exclusive. An application can use ONNX Runtime as its public inference API, select TensorRT on NVIDIA machines, use MIGraphX or another provider on AMD, and choose OpenVINO or DirectML on suitable Intel and Windows configurations. A Vulkan application can keep that same model and provider strategy while using Vulkan-owned textures or buffers at the integration boundary.

What is TensorRT and how does its build-and-runtime model work?

TensorRT is NVIDIA’s high-performance deep-learning inference SDK. It accepts networks from TensorFlow, PyTorch, ONNX and other frameworks, optimizes them for deployment on NVIDIA GPUs, and emits a serialized runtime engine. Current TensorRT documentation lists mixed-precision options including FP32, FP16, BF16, FP8, INT8, FP4 and INT4, plus dynamic input shapes; the exact availability and behavior depend on the TensorRT release and target GPU.

What happens during the build phase?

  1. Provide the network. Export or otherwise supply a supported model, commonly in ONNX format, together with any required input-shape and optimization-profile information.
  2. Configure precision and shapes. Decide which precisions are allowed and define the runtime shape ranges the engine must support. A dynamic-shape engine still needs profiles describing the permitted dimensions.
  3. Let the builder select implementations. TensorRT compiles the graph, times candidate kernels and chooses implementations for the target environment. Workspace limits, precision constraints and available tactics influence those choices.
  4. Serialize the result. The output is a binary engine, also called a plan file, that the application can store and deploy.

What happens at runtime?

The application loads the serialized engine, creates an execution context, supplies input and output buffers, and launches inference. Runtime execution is deliberately lighter than graph compilation because kernel selection and much of the optimization work happened during the build.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

NVIDIA’s architecture documentation describes this distinction directly: TensorRT has a build phase in which a builder compiles the network and selects the fastest available kernel, producing a serialized binary called an engine or plan file. Treat that file as a deployment artifact, not as a universally portable model.

Why can two TensorRT builds differ?

Kernel timing and tactic selection depend on the GPU architecture, driver and CUDA/TensorRT environment, workspace configuration, optimization profiles and other build settings. Rebuilding the same network can therefore produce a different engine and small numerical differences. Record the exact model, exporter and opset, TensorRT and CUDA versions, GPU type, precision settings, profiles and builder configuration alongside every engine.

Will a TensorRT engine work on another GPU?

Do not assume it will. A TensorRT engine is optimized for the settings used by its builder, so changing GPU architecture, TensorRT or related runtime versions, model topology, precision or optimization profiles can require a rebuild or at least explicit revalidation.

What should trigger a rebuild?

  • A different NVIDIA GPU architecture or product variant.
  • A change to the TensorRT, CUDA, driver or ONNX Runtime version used by the deployment.
  • A changed model graph, exported opset, plugin, layer implementation or input-shape profile.
  • A new precision target, such as moving from FP16 to INT8, or changed calibration data for quantization.
  • Different workspace limits or other builder settings that alter tactic selection.

How should a multi-GPU release process handle engines?

  1. Keep the portable model and export metadata as the source artifact.
  2. Build an engine for every supported GPU and software configuration, using a controlled build environment.
  3. Run numerical and performance validation on the exact deployment target.
  4. Store an engine manifest containing GPU architecture, driver, CUDA/TensorRT versions, precision, profiles and model hash.
  5. Cache engines by that complete key and fall back to a rebuild or another provider when no matching artifact exists.

If distributing engines is operationally difficult, ship the ONNX model and build on the target during installation or first launch, provided the device has the required toolchain and startup time is acceptable.

How does ONNX Runtime run the same model on different vendors?

ONNX Runtime is an inference runtime whose execution-provider architecture separates the model and application API from hardware-specific backends. The application loads an ONNX model and chooses providers in priority order; each provider claims the graph portions it supports.

Which execution providers matter for cross-GPU products?

Provider or backend Typical target Important qualification
CUDA NVIDIA GPUs Generic NVIDIA GPU execution; exact operator and version support must be tested.
TensorRT NVIDIA GPUs Delegates compatible ONNX subgraphs to TensorRT and can outperform generic GPU acceleration on the same hardware.
MIGraphX AMD GPUs Provider support and operator coverage vary by release and deployment.
OpenVINO Intel hardware Use where the operating system and device are supported by the provider.
DirectML Windows devices through DirectML Useful for a common Windows path, with performance and operator support dependent on the device.
WebGPU Web and selected cross-platform GPU deployments Provider availability and feature maturity vary; on Linux and Android, WebGPU uses Vulkan underneath.
CPU and other edge/mobile providers Fallback or specialized devices CoreML, Qualcomm QNN and additional providers exist, with production or preview status differing by provider.

What happens when an operator is unsupported?

ONNX Runtime can partition the graph: a provider executes the supported subgraph while another provider or the CPU handles unsupported nodes. This keeps more models functional, but every boundary can require synchronization and data movement. A graph that alternates repeatedly between GPU and CPU may be slower than a less specialized provider that executes the whole graph in one place.

How do you keep one codebase?

  1. Standardize the model contract. Define input names, data types, layouts, dynamic dimensions and output semantics in the ONNX export pipeline.
  2. Represent providers as configuration. Select a provider list at startup from detected hardware and operating system rather than branching model code for each vendor.
  3. Validate coverage. For every important model, confirm which nodes each provider claims and identify any CPU partitions.
  4. Keep a deliberate fallback. If the preferred provider is unavailable or fails validation, select the next supported provider and log the choice.
  5. Test each target separately. A common API does not guarantee equal precision, performance or operator behavior across providers.

This approach preserves one application-level inference path while accepting that provider binaries, supported operators and performance are target-specific.

Is ONNX Runtime with TensorRT faster than ONNX Runtime with generic GPU acceleration?

Often, on compatible NVIDIA workloads, the TensorRT execution provider can outperform generic GPU acceleration because it delegates supported subgraphs to TensorRT’s optimized kernels. That is a conditional advantage, not a universal percentage or guarantee: unsupported operators, partition boundaries and host-device transfers can erase it.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

When does the TensorRT provider help most?

  • The model’s operators are well covered by TensorRT.
  • The delegated subgraph is large enough to amortize setup and synchronization costs.
  • Precision and dynamic-shape profiles are configured for the actual workload.
  • Inputs and outputs remain on the device instead of being copied to the host between providers.

When can a simpler provider win?

A model with many unsupported operators may fragment into small TensorRT and CPU regions. Transfer and synchronization overhead can then dominate execution. A single-provider CUDA, DirectML, OpenVINO or CPU path may deliver lower tail latency even if its individual kernels are less aggressively optimized.

Can Vulkan be used for AI inference?

Yes, but Vulkan is a low-level graphics and compute API, not a complete neural-network inference stack. It gives the application control over GPU resources, command submission and synchronization. You still need an inference layer for model parsing, graph transformation, operator implementations, memory planning and provider-level fallback.

Why pair Vulkan with a higher-level runtime?

The Khronos Vulkan documentation contrasts the roles plainly: Vulkan gives low-level control over GPU rendering, while ONNX Runtime gives high-level, optimized machine-learning inference. Using both lets a game, visualization tool or media application keep ownership of its Vulkan resources while delegating model execution to an inference runtime.

What does the Vulkan integration boundary look like?

  1. Choose the model format and inference runtime independently of the rendering graph.
  2. Determine whether the runtime can consume or produce the Vulkan-backed resource types you use; otherwise plan an explicit copy or interop step.
  3. Synchronize ownership and access transitions correctly between Vulkan commands and inference work.
  4. Measure copy, map, synchronization and conversion time separately from neural-network execution.
  5. Keep a provider fallback for devices whose Vulkan driver exposes the API but lacks the required ML performance or feature support.

WebGPU is one example of a higher-level path that uses Vulkan on Linux and Android. That relationship does not make raw Vulkan equivalent to ONNX Runtime: WebGPU or another runtime still supplies the abstraction that turns a model graph into executable work.

What are the portability trade-offs between TensorRT, ONNX Runtime and Vulkan?

Portability has several dimensions: model files, application APIs, binaries, engines, operators, operating systems and performance. A technology can be portable at one layer and specialized at another.

Axis TensorRT ONNX Runtime Vulkan-based path
Primary scope NVIDIA GPU inference compiler and runtime Cross-platform inference runtime with execution providers Low-level graphics/compute API used by a higher-level runtime
Hardware reach NVIDIA GPUs and NVIDIA product variants CPU, NVIDIA, AMD, Intel, mobile and WebGPU providers, subject to provider support Broad API availability; actual ML capability depends on the inference layer and driver
Portability Engines are built for target settings; hardware changes can require rebuilds Model and API are portable while provider binaries and operator support vary Application portability is high at the API level, but shader, driver and ML implementation details remain
Best fit Maximum NVIDIA performance and control One code path across heterogeneous devices Existing Vulkan application needing low-level resource and control integration
Main risk Hardware/version-specific engine artifacts and build complexity Unsupported operators, provider gaps and transfer overhead Building or integrating the ML graph and runtime yourself if no higher layer is used

How should you benchmark the three approaches fairly?

Benchmark the deployment you will actually ship. Official NVIDIA guidance emphasizes measuring latency and throughput on your own model and hardware; no comparable cross-technology benchmark establishes a universal winner.

Hold these variables constant

  • Identical model export, ONNX opset and preprocessing.
  • Identical precision, quantization and calibration data.
  • Batch size and every input dimension, including dynamic-shape profiles.
  • Warm-up count, number of measured iterations and synchronization method.
  • Concurrency, request mix and queueing policy.
  • GPU power and clock settings, driver version and background load.
  • Postprocessing and data-transfer steps, not only kernel time.

Report more than an average

  • p50 latency and tail latency such as p95 or p99.
  • Sustained throughput at the intended concurrency.
  • Peak VRAM and host memory.
  • TensorRT engine build time and startup/deserialization time.
  • Accuracy deltas for every reduced-precision configuration.
  • ONNX Runtime provider partitions, fallback counts and host-device transfer time.
  • Vulkan resource-copy and synchronization time when interop is involved.

Warm up each path before timing steady-state requests, then run a separate cold-start test. Keep build time out of steady-state latency, but include it in deployment and autoscaling decisions. Record failures rather than silently switching providers, because a fallback can change both performance and numerical results.

How do precision, quantization and dynamic shapes affect the choice?

Precision is a deployment decision, not merely a toggle. TensorRT documents FP32, FP16, BF16, FP8, INT8, FP4 and INT4 capabilities, but support is release- and hardware-dependent. ONNX Runtime providers expose different subsets, and a Vulkan-based implementation depends on the higher-level runtime and driver.

Precision checklist

  • Confirm that the target GPU supports the selected data type efficiently.
  • Measure accuracy against an FP32 reference on representative data.
  • For INT8 or other calibrated formats, version the calibration dataset and procedure.
  • Check that every provider in a fallback chain accepts the model’s data types without hidden conversions.
  • Include conversion and dequantization costs in latency measurements.

Dynamic-shape checklist

TensorRT dynamic shapes require optimization profiles that define supported dimensions. Narrow profiles can improve specialization but may reject requests outside their ranges; broad profiles improve flexibility but can alter memory use and kernel choices. Keep the same shape distribution when comparing providers, and test minimum, typical and maximum shapes rather than only one convenient input.

What deployment workflow keeps a cross-GPU product maintainable?

Separate portable model assets from target-specific execution assets. This lets the product evolve without turning every model update into a manual per-device release.

  1. Export once, validate the contract. Produce the ONNX model and test names, shapes, layouts, data types and outputs against the training reference.
  2. Enumerate supported targets. List NVIDIA, AMD, Intel, CPU, mobile or WebGPU targets together with operating-system and driver requirements.
  3. Map each target to a provider. Prefer TensorRT or CUDA on NVIDIA when validated, MIGraphX on supported AMD systems, OpenVINO or DirectML for appropriate Intel and Windows paths, and WebGPU where that deployment is required.
  4. Build specialized artifacts only where they pay off. Generate TensorRT engines per target configuration; keep the ONNX model as the portable fallback.
  5. Run conformance tests. Compare outputs, tolerances, unsupported nodes, memory use and latency for every provider.
  6. Package manifests and diagnostics. Record model hash, provider, runtime versions, GPU identity, precision, profiles and fallback events.
  7. Monitor production behavior. Alert on provider changes, unexpected CPU execution, transfer spikes, engine rebuilds and accuracy regressions.

What are the most common failure modes?

Engine deserialization fails

Check the engine manifest against the installed GPU, driver, CUDA/TensorRT and runtime versions. If any target setting changed, rebuild from the original model rather than attempting to repair the binary.

Latency is worse after enabling TensorRT

Inspect graph partitioning and transfer timelines. A model split among TensorRT, another provider and CPU can spend more time synchronizing than computing. Try to keep larger supported regions together or benchmark a single-provider path.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

A provider cannot load the model

Identify unsupported operators, data types and dynamic dimensions. Simplify or replace unsupported graph nodes where practical, export with a compatible opset, or route the model to a provider that covers the complete graph.

Results differ after changing precision

Compare intermediate outputs to locate the first divergence, then test a narrower precision change or keep sensitive layers at higher precision. Treat accuracy thresholds as part of provider qualification, not as an afterthought.

Vulkan integration stalls the renderer

Profile resource ownership transfers, staging copies and queue synchronization separately. Avoid forcing the graphics queue to wait on every inference operation; use the synchronization pattern supported by the runtime and hardware, and verify that the apparent Vulkan gain is not offset by copies.

What is the practical decision framework?

Apply these rules in order:

  1. Vendor constraint: If every deployment is NVIDIA, benchmark TensorRT first. If vendors or operating systems vary, begin with ONNX Runtime.
  2. Performance target: If a validated TensorRT engine meets the target with acceptable build operations, use it. If not, compare ONNX Runtime providers on complete graphs rather than isolated kernels.
  3. Integration constraint: If Vulkan already owns the application’s resources, keep Vulkan at the graphics boundary and avoid reimplementing neural-network execution in shaders unless you have a compelling, measured reason.
  4. Operations constraint: If rebuilding target-specific artifacts is unacceptable, favor a portable ONNX deployment and provider fallback.
  5. Evidence: Choose the path whose measured p50, tail latency, throughput, memory, startup and accuracy satisfy the product requirement on every supported target.

Frequently Asked Questions

Can one ONNX model serve both NVIDIA and AMD GPUs without conversion?

Usually the same ONNX file can be offered to both systems, but each machine needs a compatible ONNX Runtime execution provider and its supported operator set. Validate outputs and performance separately because provider partitioning, precision behavior and fallback can differ.

What’s actually slowing this PC down?

Pick the symptom - the matching free tool is one click away.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Do dynamic input sizes make TensorRT engines portable?

No. Dynamic shapes let one engine cover configured dimension ranges, but the optimization profiles and target-specific kernel choices remain part of the engine’s deployment assumptions. Requests outside a profile can fail or require another engine.

How much accuracy do FP16 or INT8 modes lose?

There is no fixed loss that applies to every network. Evaluate representative validation data against an FP32 reference, record the metric change for each provider, and keep sensitive operations at higher precision when the error budget is exceeded.

Is Vulkan suitable for browser or Android inference?

Vulkan can be part of the underlying path, but browser and mobile applications generally need a higher-level runtime such as a WebGPU-based provider or platform-specific provider. Verify device, driver and browser support instead of treating Vulkan API availability as proof of neural-network capability.

Should engine build time be included in an inference benchmark?

Report it separately. Steady-state latency should measure execution after warm-up, while deployment, autoscaling and first-launch decisions should include engine compilation, serialization, loading and any cache misses.
