The best LLM observability tool depends on what you need to control. OpenTelemetry is the strongest starting point when portability and ownership of telemetry matter, but it is only an instrumentation and transport layer. A complete operating setup pairs it with a backend such as Arize Phoenix or Langfuse for trace exploration, evaluation, and cost views. Phoenix is a documented open-source option with self-hosting, datasets, experiments, and retrieval evaluation; Langfuse is commonly shortlisted for an integrated tracing, evaluation, OpenTelemetry, and cost workflow. The right choice follows your data-residency, evaluation, and allocation requirements rather than a universal feature ranking.

This guide explains what each layer does, how to compare tools, how to instrument an application, how to evaluate quality in production, and how to make token costs accurate enough for budgets and alerts.

What does LLM observability include?

LLM observability combines three related jobs that answer different operational questions:

  • Tracing: records the end-to-end path of a request, including model calls, prompts, responses, retrieval, tools, latency, errors, and metadata. It answers, “Why did this request fail, slow down, or produce this answer?”
  • Evaluation: applies human review, deterministic checks, or model-based judges to datasets and production traces. It answers, “Does the system meet the quality target, and did a change cause a regression?”
  • Cost monitoring: attributes tokens and provider usage to requests, users, teams, or features. It answers, “What did this behavior consume, and who should own the spend?”

These functions overlap in a useful way. A trace supplies the evidence for an evaluation, while the same trace can carry token counts used for cost allocation. Treating them as separate products, however, prevents a common mistake: a dashboard that shows latency is not automatically an evaluation system, and a token counter is not a quality monitor.

Is OpenTelemetry an LLM observability tool by itself?

OpenTelemetry is the portable foundation, not the complete product. Its vendor-neutral framework generates, collects, and exports traces, metrics, and logs. Instrumenting an application with it lets you route telemetry to different backends without rewriting every call site.

OpenTelemetry does not itself provide the storage, query interface, dashboards, retention controls, or evaluation workflow that an LLM team needs day to day. You must select and operate a backend, then add evaluators and cost logic. This separation is valuable when you want to change vendors, keep a copy of raw telemetry, or enforce a central collection policy across multiple services.

When the foundation-first approach fits

  • You expect to change observability backends or use more than one.
  • Your platform team already operates a collector and storage system.
  • You need consistent telemetry from LLM calls, retrieval services, databases, and ordinary microservices.
  • Data residency, access control, or retention rules require a pipeline you control.

What you still have to build

A foundation-first stack still needs decisions about span names, parent-child relationships, prompt and response capture, sampling, redaction, query views, evaluator execution, and provider-rate tables. Those engineering tasks can be worthwhile, but they are part of the total cost of ownership and should be compared with the effort saved by an integrated platform.

How do OpenTelemetry, Arize Phoenix, and Langfuse differ?

The three options occupy different positions in the stack. OpenTelemetry is the transport and instrumentation layer; Phoenix is an open-source observability platform; Langfuse is commonly evaluated as an integrated platform that combines the three core functions.

Option Primary role Documented or commonly cited capabilities Best fit Important qualification
OpenTelemetry Instrumentation and telemetry transport Vendor-neutral generation, collection, and export of traces, metrics, and logs Teams prioritizing portability, pipeline control, and broad service coverage Requires a separate backend for storage, querying, dashboards, and usually evaluation
Arize Phoenix Open-source LLM observability platform OpenTelemetry-based tracing, response and retrieval evaluation, datasets, experiments, prompt management, and self-hosted deployment options Teams wanting an evaluation-oriented platform with deployment control Confirm current integrations, retention behavior, licensing, and operational requirements for your chosen deployment
Langfuse Integrated LLM observability platform Tracing, evaluation, OpenTelemetry support, and cost tracking are listed in current comparative material Teams seeking one workflow for traces, quality checks, and spend attribution Verify current features, pricing, licensing, retention, and data-region availability directly before committing

Other candidates frequently shortlisted include LangSmith, Braintrust, MLflow, Datadog LLM Observability, Grafana Cloud AI Observability, Helicone, and Weights & Biases Weave. This is a candidate set, not a universal ranking: capabilities, plan limits, and product status change, so evaluate the current offer against your requirements.

1. Trace context and debugging depth

Check whether a trace can show nested spans for orchestration, model calls, retrieval, reranking, tool execution, and post-processing. Confirm that each span can retain model name, prompt and response references, latency, status, token counts, error details, and correlation IDs. Sampling controls matter when prompts contain sensitive data or traffic is large; you may need full traces for failures and a lower sample rate for routine successes.

2. Evaluation depth

Look for built-in evaluators, custom code hooks, model-as-judge configuration, human annotation, dataset management, experiment tracking, and regression gates. Ask whether an evaluator can run against both a fixed test set and production traces, whether judge prompts and model versions are versioned, and whether failed cases can be replayed after a prompt or retrieval change.

3. Cost coverage

A credible cost view must account for provider and model rate tables, input and output tokens, cached-token treatment, retries, batch jobs, and any discounts. It should allow allocation by request, user, team, feature, or environment. A simple multiplication of total tokens by one price is inadequate when a request uses several models or when a retry doubles usage.

4. Operations and governance

Compare SaaS and self-hosted deployment, retention controls, role-based access, redaction, data residency, encryption, export, and incident alerting. Determine where prompt and response content is stored, who can query it, and how quickly you can delete a user’s data. For regulated workloads, these controls can outweigh a smoother dashboard.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

5. Integration and portability

Assess OpenTelemetry support, framework SDKs, collector compatibility, export APIs, and the effort required to change backends. Instrumentation that follows open semantic conventions reduces lock-in and lets platform teams standardize traces across LLM and non-LLM services.

6. Economics

Model seat charges, event or trace volume, retention tiers, egress, evaluator-model usage, and the engineering time required to run collectors and storage. A low subscription price can still be expensive if high-volume traces are retained indefinitely or if every evaluation invokes a paid judge model.

How do I design a useful LLM trace?

Start with one request-level trace and make every meaningful operation a child span. This gives engineers a causal timeline instead of a flat log stream.

  1. Create a request span. Record a stable request ID, service and environment, user or tenant key (preferably pseudonymous), start and end times, and an outcome status.
  2. Add orchestration spans. Wrap routing, agent planning, prompt construction, guardrails, and post-processing so you can see where time and failures accumulate.
  3. Instrument each model call. Capture provider, model, temperature or equivalent controls, prompt and response references, input and output token counts, finish reason, latency, and error information. Store content only under an explicit privacy policy.
  4. Trace retrieval and tools. Record query text or a redacted hash, index or database identifier, top-k setting, retrieved document IDs, scores, tool name, arguments, result status, and duration. This makes weak retrieval distinguishable from weak generation.
  5. Propagate context. Pass the trace ID through queues, tool services, and asynchronous workers. Without propagation, a single user request fragments into unrelated records.
  6. Apply sampling and redaction. Keep complete traces for errors and evaluation samples, while sampling routine successes. Mask secrets, personal data, credentials, and unnecessary document text before export.
  7. Validate the result. Trigger a known request and confirm that the parent span contains the expected child spans, timestamps are ordered, token counts are present, and an error can be located without searching several systems.

A practical event schema can include fields such as trace_id, span_id, parent_span_id, operation, model, input_tokens, output_tokens, latency_ms, status, tenant_key, and release_version. Keep identifiers stable enough to join records, but avoid putting raw secrets or permanent personal identifiers into them.

How should I evaluate LLM quality?

Use layered evaluation: deterministic checks for known rules, reference or retrieval checks for factual behavior, and human or model-based review for open-ended quality. No single score captures every failure mode.

Build a representative dataset

Include ordinary traffic, edge cases, safety-sensitive prompts, long contexts, multilingual examples if relevant, and previously reported failures. Store the expected behavior or grading rubric with each example. A small but diverse set is more useful than a large set of near-duplicates.

Choose evaluators that match the risk

  • Heuristic checks: JSON-schema validity, required fields, citation presence, prohibited terms, length limits, and latency thresholds.
  • Retrieval checks: document hit rate, relevance, context precision, and whether the answer is supported by retrieved material.
  • Response checks: factuality, relevance, completeness, tone, refusal behavior, and instruction following.
  • Model-as-judge checks: rubric-scored comparisons or pairwise preferences, with judge prompts and model versions fixed and audited.
  • Human review: a calibrated sample for ambiguous cases and for validating whether automated scores correlate with user expectations.

Run experiments and regression gates

Version prompts, retrieval settings, model selections, tool policies, and evaluator definitions. Run a candidate change against the same dataset as the baseline, inspect both aggregate scores and individual traces, and set release gates for critical metrics. Investigate score movement by slice—such as language, customer tier, or request type—because an unchanged average can hide a serious regression in a small segment.

How can I monitor token and API cost accurately?

Calculate cost at the span level, then roll it up using the same dimensions your organization uses for budgets. Accuracy depends on matching the exact model, token category, and provider conditions for each call.

  1. Capture usage from the provider response. Prefer reported input, output, cached, and reasoning-token fields over estimates. Keep the raw usage record for audits.
  2. Maintain dated rate tables. Store provider, model, region, token type, currency, effective date, and whether a rate applies to batch or standard requests. Never overwrite historical rates; otherwise past reports change when a provider updates pricing.
  3. Handle special cases. Distinguish cached tokens, retries, fallbacks, batch discounts, tool calls, and embedding or reranking usage. A request may incur several model rates.
  4. Allocate ownership. Attach team, product, feature, environment, and tenant dimensions at the request or span level. Use pseudonymous keys where direct identity is unnecessary.
  5. Reconcile totals. Compare daily instrumented usage with provider invoices or usage exports. Investigate gaps caused by dropped telemetry, asynchronous jobs, failed retries, or calls made outside the instrumented client.
  6. Set alerts with context. Alert on sudden spend, cost per successful request, retry-driven waste, or budget burn rate. Include model, feature, and release dimensions so an engineer can act on the alert.

Because provider rates, tokenization, caching, retries, and batch discounts can change, cost figures are configuration-sensitive. Present the rate-table version and calculation period alongside dashboards rather than treating a single number as timeless.

Should I self-host or use a SaaS observability platform?

Self-hosting maximizes deployment and data control; SaaS usually reduces operational work. The better choice depends on the sensitivity and scale of your traces, not on a blanket security assumption.

Decision factor Self-hosted platform SaaS platform
Data residency Choose storage location and network boundaries directly Depends on available regions, contractual terms, and export controls
Operations You manage upgrades, availability, backups, collectors, and capacity Provider manages core service operations; you manage integration and governance
Customization Greater control over schemas, retention, and integrations Faster adoption within the provider’s supported model
Cost shape Infrastructure and engineering costs grow with volume and retention Subscription or usage charges can rise with traces, seats, retention, or egress
Incident response Internal teams own on-call and recovery Service-level commitments and vendor support become part of the dependency

Whichever model you select, define retention by data class. Error traces and evaluation samples may need longer access than routine successful requests, while raw prompts may require a shorter period or immediate redaction.

What implementation plan minimizes risk?

Roll out observability in stages so you can prove usefulness before collecting every field at full volume.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.
  1. Map the request path. List model calls, retrieval, tools, queues, and post-processing for one production feature.
  2. Instrument the critical path. Use OpenTelemetry conventions where possible and send a limited sample to a chosen backend.
  3. Establish privacy rules. Decide which prompt fields are stored, redacted, hashed, or excluded, and test access roles before enabling broad visibility.
  4. Add a baseline dataset. Capture representative examples and label known failures so evaluator changes can be measured.
  5. Attach cost metadata. Record provider usage, rate-table version, and ownership dimensions for every model span.
  6. Create operational views. Build separate views for latency and errors, quality regressions, and spend. Avoid one blended score that hides trade-offs.
  7. Set release and incident workflows. Define who investigates failed evaluations, who approves prompt or model changes, and how alerts link back to traces.
  8. Expand coverage deliberately. Add services and traffic only after sampling, retention, and storage costs are understood.

What are the common failure modes?

Most observability projects fail through incomplete context or misleading measurements rather than a missing dashboard.

  • Only logging the final answer: you cannot distinguish retrieval, tool, prompt, or model failures. Add nested spans for each operation.
  • Collecting raw content without controls: sensitive data spreads into every analyst view and backup. Redact by default and grant content access narrowly.
  • Using one evaluator score: aggregate scores hide slice-specific regressions. Keep multiple evaluators and inspect failing examples.
  • Estimating tokens from characters: estimates diverge across tokenizers and models. Use provider-reported usage whenever available.
  • Ignoring retries and asynchronous work: costs and latency appear lower than reality. Link retry and worker spans to the originating request.
  • Leaving rate tables undocumented: finance cannot reproduce a dashboard after pricing changes. Version every rate and calculation period.
  • Over-retaining everything: storage, privacy exposure, and query noise grow together. Set retention and sampling policies by purpose.

Which tool should you choose?

Choose OpenTelemetry plus a backend when portability is your first requirement; choose Phoenix when an open-source, evaluation-centered platform and self-hosting are priorities; consider Langfuse when an integrated tracing, evaluation, OpenTelemetry, and cost workflow matches your governance and budget. Shortlist other platforms only after checking the same six comparison axes and testing a representative trace and evaluation set.

Run a proof of concept with one feature, several failure cases, and a month of realistic traffic. Require the candidate to show a complete trace, a repeatable evaluation result, and a reconciled cost report before expanding the deployment. That evidence is more reliable than a feature checklist or an unqualified “best tool” claim.

Frequently Asked Questions

Can LLM observability work without storing full prompts and responses?

Yes. You can retain metadata, hashes, token counts, and redacted excerpts while keeping sensitive content in a separate controlled store or not storing it at all. The trade-off is that engineers may need an approved workflow to retrieve the original context during an incident.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

How often should LLM evaluation datasets be updated?

Add examples whenever users report a failure, a provider model changes, or a new retrieval or tool path ships. Keep a stable regression set for trend comparisons and a rotating set for newly emerging behavior.

What is a reasonable trace-sampling policy for a busy production system?

There is no universal percentage. A practical policy keeps all errors and evaluator samples, samples successful requests by feature or tenant, and temporarily increases sampling during releases or incidents; tune it against storage cost and debugging time.

How do I verify that an observability cost report matches a provider invoice?

Export the provider’s usage for the same billing period, group both datasets by model and token category, and reconcile retries, batch jobs, cached tokens, and uninstrumented calls. Preserve the rate-table version used for the report so differences can be explained later.
