Evaluate an LLM as part of the product that uses it, not as an isolated chatbot. Define the real user task and release criteria, test a representative held-out dataset, and combine automated checks, rubric-based model judging, and calibrated human review. A serious evaluation also measures safety, robustness, fairness, latency, cost, and efficiency. For a RAG system, score retrieval separately from answer generation and verify that every important claim is supported by the retrieved context. Repeat the suite after meaningful changes to the model, prompt, retrieval pipeline, tools, or policies.

What does LLM evaluation measure?

LLM evaluation is the structured process of determining whether a model-powered application meets its intended goals under realistic conditions. The unit being evaluated may be a base model, a prompt-and-model chain, an agent with tools, or a complete RAG application. A model can write fluent text while still failing on factuality, instruction following, safety, latency, or cost, so one score is rarely sufficient.

Start by writing a success statement in user terms: for example, “support agents receive a correct, policy-compliant answer with evidence within the service-level latency.” Turn that statement into measurable checks and a release threshold or target range. OpenAI’s evaluation guidance recommends scoped tests that reflect real-world distributions rather than waiting until launch or relying on informal “vibe” assessments.

How do I define an evaluation objective and release criteria?

Write the task, acceptable behavior, unacceptable behavior, and decision rule before selecting metrics. The objective determines what data you need and which evaluator is credible.

Specify the task and user population

  • Describe the input, expected output, and any tools or retrieved sources the system may use.
  • State who uses the feature, which languages and domains are in scope, and what input lengths are normal.
  • Identify high-impact outcomes, such as medical, financial, legal, employment, privacy, or security decisions, that require stricter review.

Define measurable success

  • Set correctness or task-completion requirements for ordinary cases.
  • Define refusal and escalation behavior for unsafe, unsupported, or ambiguous requests.
  • Set targets for latency, cost per request, throughput, and resource efficiency.
  • Specify fairness and robustness checks for relevant user groups, languages, and adversarial inputs.

Use a release rule that can fail. A weighted average can hide a dangerous safety regression, so pair aggregate scores with non-negotiable gates such as zero tolerance for a defined class of policy violations or a minimum groundedness rate on critical questions.

How should I build an LLM evaluation dataset?

Use a representative, versioned dataset with a held-out test set that is never used to tune prompts or thresholds. A strong set combines normal traffic with the cases most likely to expose failure.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Sources to combine

  • Domain-expert examples: Questions and ideal answers written or verified by people who understand the task.
  • Production logs: De-identified requests sampled to match actual traffic, including difficult and abandoned sessions.
  • Historical failures: Incidents, support escalations, red-team findings, and previously observed hallucinations.
  • Synthetic cases: Controlled variations that expand coverage when real examples are scarce; review them for realism.
  • Edge and adversarial cases: Long inputs, conflicting instructions, prompt injection, ambiguous wording, multilingual requests, sensitive data, and attempts to bypass safeguards.

Prevent leakage and preserve representativeness

Separate development, validation, and held-out test data. Do not copy test prompts into demonstrations, system instructions, or evaluator examples. Record the sampling method and the distribution of task types, languages, user segments, input lengths, safety categories, and retrieval conditions so that a score can be interpreted.

Version the dataset and keep an immutable copy of each release set. When a new failure appears, add a minimized, representative version to the regression set while preserving the original held-out examples for trend comparisons.

Which metrics should I use for an LLM?

Use a scorecard rather than a single accuracy number. Microsoft groups evaluation methods into reference-based, reference-free, LLM-based, code, and RAG metrics; Stanford’s HELM framework demonstrates why capability should be reported alongside efficiency, bias, and toxicity.

Dimension What it asks Suitable evidence
Correctness Is the answer right for the task? Exact match, executable tests, reference comparison, or expert labels
Relevance Does it answer the user’s question without needless material? Rubric-based review or calibrated model judge
Factual consistency Are claims supported by authoritative evidence? Reference checks, claim verification, or groundedness review
Instruction following Did the system obey format, scope, and policy instructions? Pass/fail rules, schema validation, and rubric review
Safety Does it refuse or safely redirect harmful and sensitive requests? Policy test cases, red-team prompts, and human adjudication
Fairness Does performance or treatment vary unfairly across groups or languages? Stratified slices and paired counterfactual cases
Robustness Does behavior hold under perturbations, long inputs, and attacks? Adversarial and stress-test suites
Latency How quickly does a user receive a usable response? Distributional timings, including tail latency
Cost What does each successful task consume? Per-request and per-successful-task accounting
Efficiency How much compute, context, or tool use is required? Token, retrieval, tool-call, and infrastructure measurements

Reference metrics such as ROUGE or BLEU are useful only when overlap with a reference answer is meaningful. They can penalize a correct answer expressed differently and cannot establish safety or factuality on their own.

Which evaluator is appropriate for each task?

Match the evaluator to the decision. Deterministic checks are strongest for deterministic outputs; human review remains the reference for nuanced or high-risk judgments.

Exact-match and executable tests

Use exact match for labels, structured fields, and other outputs with one unambiguous representation. For code, SQL, calculations, or tool calls, execute the result in a controlled environment and test behavior rather than wording. Validate schemas, required fields, and allowed values before any subjective scoring.

Reference-based and reference-free checks

Compare against a trusted answer when one exists, but do not treat textual similarity as truth. Reference-free rubrics can assess relevance, style, or safety when multiple answers are valid; define concrete pass conditions and examples for each score level.

LLM-as-judge

A judge model can classify, compare two answers, or score a rubric at scale. Pairwise comparison, pass/fail classification, and constrained labels are generally more reliable than asking for an unconstrained numerical essay. Calibrate the judge against expert labels before using it as a release gate. Test for position bias by randomizing which answer appears first and for verbosity bias by controlling response length or scoring substance separately from detail.

Human review

Use blinded randomization, clear instructions, and multiple reviewers for high-impact decisions. Measure reviewer agreement, adjudicate disagreements with a documented rule, and periodically refresh examples so reviewers do not memorize the set. Human review is slower and more expensive, but it anchors the interpretation of subtle quality, safety, and domain-specific criteria.

How do I run reliable evaluation trials?

LLM outputs are nondeterministic, so one run can misrepresent typical behavior. Repeat sampling when practical and report distributions or target ranges instead of a lone point estimate.

  1. Freeze the configuration. Record the model identifier, system and developer instructions, prompt templates, retrieval index, tool versions, decoding parameters, and seeds where available.
  2. Run the same cases repeatedly. Use multiple samples for stochastic tasks and preserve every output, not just the aggregate score.
  3. Aggregate transparently. Report mean or median where useful, but also show spread, failure counts, and important slices. Azure guidance recommends target ranges rather than a single target for variable outputs.
  4. Compare under matched conditions. Keep dataset versions, sampling, evaluator prompts, and ordering controls fixed when comparing models or prompt changes.
  5. Check statistical uncertainty. Include confidence or uncertainty treatment appropriate to the sample and avoid declaring a winner when differences are within expected variation.

How do I evaluate a RAG chatbot?

Evaluate retrieval and generation as separate stages, then measure the end-to-end answer. A fluent answer can be wrong because retrieval omitted the needed evidence, or because generation ignored evidence that was present.

Retrieval metrics

  • Hit rate or recall: Did the retrieved set contain the passage needed to answer?
  • Context precision or relevancy: How much of the retrieved material is actually useful for the question?
  • Coverage by slice: Does retrieval work for document type, language, query length, freshness, and access-control condition?

Generation and grounding metrics

  • Faithfulness or groundedness: Do answer claims follow from the supplied context? Microsoft describes faithfulness on a 0–1 scale, with 1 best.
  • Answer correctness: Is the final response accurate for the user’s task, not merely supported by a related passage?
  • Answer relevancy: Does it directly address the question?
  • Citation correctness: Do citations point to the claims they supposedly support?
  • Abstention behavior: Does the system say it lacks evidence, ask for clarification, or escalate when retrieval is insufficient?

Inspect two especially important failure groups: cases with good retrieval but hallucinated generation, and cases with fluent generation where retrieval never contained the required evidence. Track latency and cost for retrieval, reranking, generation, and tool calls so optimization does not hide a quality regression.

Are public benchmarks enough to choose an LLM?

No. Public benchmarks are useful for standardized cross-model comparisons and trend checks, but they should not be the sole release gate for an application.

Stanford’s HELM provides standardized datasets, a unified interface to multiple providers, broader metrics such as efficiency, bias, and toxicity, and leaderboards for inspecting results. Those results help establish general capability, while a production-shaped suite determines whether the model handles your users, policies, documents, tools, and failure costs. Differences in prompting, context windows, tool access, and evaluator design can make a benchmark ranking diverge from your application outcome.

How do I analyze failures instead of only tracking scores?

Read individual failures and turn them into actionable categories. Slice results by language, task type, user segment, input length, safety category, retrieval quality, and adversarial condition.

  1. Preserve the complete input, retrieved context, output, tool trace, evaluator judgment, and configuration.
  2. Cluster failures by root cause, such as missing retrieval, instruction conflict, unsupported inference, formatting error, unsafe compliance, or latency timeout.
  3. Estimate the impact and frequency of each cluster, not just its percentage of all cases.
  4. Add representative minimized examples to the regression suite and assign an owner for the fix.
  5. Rerun the full suite after the fix to detect improvements and collateral regressions.

Do not delete hard cases because they lower a score. A shrinking failure set can indicate better quality, while removing failures can create a misleadingly stable metric.

How do I make LLM evaluation continuous in production?

Run the evaluation suite on every material model, prompt, retrieval, tool, policy, or infrastructure change, then monitor real usage for new failure modes.

  • Gate deployment on critical safety, schema, and groundedness checks.
  • Sample production interactions with privacy protections for delayed human or judge review.
  • Monitor user corrections, escalations, refusals, latency tails, cost, and retrieval misses.
  • Compare live slices with the training and test distributions to detect drift.
  • Expand the regression set whenever monitoring or incident review reveals a new class of failure.

Amazon Bedrock documents managed evaluations for models, knowledge bases, and external RAG sources, including automatic metrics and human ratings. Managed tooling can reduce setup effort, but the criteria and data still need to reflect your application.

What should an evaluation report record for reproducibility?

Record enough detail for another team to reproduce the comparison and understand its limits. NIST’s AI Resource Center treats testing, evaluation, verification, and validation as operational parts of an AI risk-management program; HELM emphasizes holistic, reproducible, transparent reporting.

  • Dataset version, provenance, sampling method, and train/development/test separation
  • Prompt, system instructions, policies, and demonstration examples
  • Model, retrieval, tool, and infrastructure versions
  • Decoding parameters, repetition count, seeds where available, and response-order randomization
  • Metric definitions, evaluator prompts, rubric examples, reviewer instructions, and agreement analysis
  • Aggregation method, confidence or uncertainty treatment, thresholds, and exceptions
  • Known limitations, unsupported domains, privacy controls, and unresolved failure clusters

What are the most common LLM evaluation mistakes?

  • Using one benchmark score: It ignores your task distribution, safety requirements, and operating costs.
  • Testing only happy paths: Real failures often occur in ambiguous, adversarial, multilingual, or long-context inputs.
  • Tuning on the test set: Leakage turns a held-out comparison into another development loop.
  • Trusting an uncalibrated judge: Position, verbosity, and domain biases can produce confident but invalid rankings.
  • Ignoring nondeterminism: A single sample cannot characterize variable behavior.
  • Scoring RAG end to end only: Without separate retrieval and generation metrics, you cannot locate the defect.
  • Reporting averages without slices: A strong aggregate can conceal failure for a language, user group, or safety category.
  • Changing several components at once: You lose the ability to attribute a quality or cost change.

Frequently Asked Questions

How large should an LLM evaluation dataset be?

There is no universal minimum. Size it to cover the task distribution and rare high-impact cases, then use repeated sampling or uncertainty estimates to show how stable the result is. A smaller, carefully stratified set with expert-reviewed edge cases is more useful than a large but repetitive collection.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

What temperature should I use during evaluation?

Evaluate with the same decoding settings your application will use, then test alternative settings when they are part of the deployment decision. Deterministic settings can simplify regression checks but do not reveal variability users may see at higher sampling. Store the settings with every result.

How can I evaluate an LLM when there is no single correct answer?

Define a rubric around required properties such as factual support, relevance, safety, structure, and appropriate uncertainty. Use pairwise comparisons or pass/fail criteria with concrete examples, and anchor automated judgments to blinded human labels. Agreement and disagreement analysis matter more than a pseudo-precise score.

How should privacy be handled in LLM evaluation logs?

De-identify or redact personal and confidential data before it enters datasets, judges, or reviewer tools, and restrict access to raw traces. Keep a documented retention period and preserve only the fields needed to reproduce a failure. Test that redaction itself does not remove information required for the task.
