AI inference timeouts are usually a capacity or scheduling problem that averages hide. Start by separating queue wait, prompt processing, model execution, output processing, and— for streaming language models—time to first token (TTFT), prefill, decode, and inter-token latency. A rising queue with waiting requests points to admission pressure; a long compute phase points to model or hardware saturation; high GPU utilization by itself does not tell you which is happening. Measure p50, p95, and p99 by model, replica, region, prompt length, and generation length, then tune queue limits, active sequences, batching, cache headroom, and autoscaling signals against the phase that is actually slow.

What causes sudden latency spikes in AI inference serving?

End-to-end latency is not one operation. A request can spend time waiting for admission, processing its input, executing model kernels, producing output, and traversing the network back to the client. For a streaming language-model request, the user-visible experience also depends on TTFT and the gaps between generated tokens.

The most common pattern is overload: arrivals exceed the work a replica can complete, so waiting requests accumulate before the model is even scheduled. Google Cloud describes this relationship directly: “Queue size directly correlates to request latency.” A second pattern is resource contention. Long prompts consume prefill capacity and KV cache, while long generations occupy decode slots; either can delay shorter requests through head-of-line blocking.

Timeouts can also be created outside the model. An ingress, gateway, service mesh, load balancer, client, or server deadline may expire while the model is still working. Treat a timeout as a path-level symptom until you identify the exact phase and component that exceeded its budget.

How should I measure the latency budget?

Instrument each phase instead of relying on one end-to-end average. Percentiles expose queue bursts and long-tail requests that an average conceals.

Triton metrics to inspect

Phase or signal Metric What it tells you
Total request duration nv_inference_request_duration_us Time from request arrival through completion.
Queue wait nv_inference_queue_duration_us Time waiting for a scheduling or execution slot.
Input processing nv_inference_compute_input_duration_us Time spent preparing inputs.
Model execution nv_inference_compute_infer_duration_us Time consumed by inference computation.
Output processing nv_inference_compute_output_duration_us Time spent producing or post-processing outputs.

Enable first-response histograms when first-token behavior matters. A high request duration with a small queue duration indicates compute or output work; a high queue duration means requests are waiting before execution.

vLLM metrics to inspect

Phase or signal Metric Use
End-to-end completion vllm:e2e_request_latency_seconds Measures the interval between frontend arrival and receipt of the final token.
First token vllm:time_to_first_token_seconds Shows admission plus prefill delay before streaming begins.
Token spacing vllm:inter_token_latency_seconds Shows gaps during streaming decode.
Output-token timing vllm:request_time_per_output_token_seconds Tracks time associated with generated tokens.
Queue vllm:request_queue_time_seconds Shows time before the request is scheduled.
Prefill vllm:request_prefill_time_seconds Shows prompt-processing time.
Decode vllm:request_decode_time_seconds Shows generation-phase time.
Cache pressure vllm:kv_cache_usage_perc Shows how close the KV cache is to exhaustion.

Graph running, waiting, and swapped requests beside these histograms. A rising waiting count with stable decode time is an admission problem; rising decode time with a full running set is a compute or batching problem.

How do I confirm the scope of a spike?

Before changing scheduler settings, establish whether the event is global, replica-specific, traffic-specific, or confined to one latency phase.

  1. Record request rate, status codes, timeout counts, and the exact timeout location reported by each client or proxy.
  2. Group measurements by model and version, replica, region, and deployment revision. A single unhealthy replica can raise fleet-wide p99 while fleet averages look normal.
  3. Capture prompt-token and generation-token distributions. Compare short and long contexts rather than using only mean token counts.
  4. Separate TTFT, streaming gaps, and completion time. A request that starts streaming promptly but stalls between tokens has a different failure mode from one that never produces its first token.
  5. Compare p50, p95, and p99 during the event with a known-good interval. The available documentation defines these server metrics but does not prescribe one universal timeout budget.

Keep a timeline containing deploys, model changes, traffic shifts, autoscaler actions, GPU errors, and configuration updates. Correlation with a rollout or traffic class often removes hours of guesswork.

Is the request stuck in a queue or is the model itself slow?

Use queue-time percentiles and scheduler-state counts to distinguish waiting from execution. Do not infer the answer from GPU utilization alone.

All server phases look normal but clients time out Proxy, gateway, network, or client deadline Trace every timeout and idle-timeout setting in the path.

AWS cautions that GPU utilization (DCGM_FI_DEV_GPU_UTIL) shows whether the GPU is busy, not how busy it is. A busy GPU can be handling a sustainable workload or be one queue burst away from severe tail latency; only queue and latency measurements reveal the difference.

How do I diagnose queue and admission pressure?

High queue-time percentiles combined with waiting requests mean the service cannot admit work as fast as it arrives. Check limits and traffic shape before optimizing kernels.

Check replica capacity and autoscaler reaction time

Compare arrival rate with completed requests and observe how long a new replica takes to become ready. If the queue grows faster than the autoscaler can add capacity, a technically correct scale-up policy can still allow client deadlines to expire.

Check active and queued request limits

Review the maximum active sequences, maximum queued requests, and any server-side admission cap. A bounded queue protects existing work, but once the configured in-flight limit is reached vLLM can return HTTP 503. Clients must implement retry with backoff, a fallback route, or an explicit overload response rather than retrying in a tight loop.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Check KV-cache pressure

Long prompts and long generations consume KV-cache blocks. Near exhaustion, requests may wait, swap, be rejected, or be repeatedly preempted. Track vllm:kv_cache_usage_perc together with waiting, running, and swapped requests; a high cache watermark with growing wait time is an admission problem even when arithmetic utilization looks acceptable.

Segment traffic that blocks other work

Separate long-context or high-generation requests from short interactive traffic when they dominate the queue. Isolation can be implemented with separate replicas, queues, or priority classes. This prevents a small number of expensive requests from delaying a latency-sensitive class.

How should I tune batching and concurrency?

Continuous batching improves concurrency by filling execution slots as requests arrive, but larger mixed batches can increase latency when prompt prefill competes with token decode. Tune for the service objective, not maximum GPU occupancy.

Set a safe concurrency ceiling

Review vLLM max_num_seqs and max_num_active_seqs. Raising them may improve throughput until KV-cache or decode contention causes TTFT and inter-token latency to climb. Lowering them can protect tail latency and memory headroom, at the cost of throughput.

Bound queued work

Use max_num_queued_reqs or the equivalent admission limit to prevent unbounded waiting. A finite queue makes overload visible as a controlled rejection instead of allowing every request to time out. Pair the limit with client-side exponential backoff and jitter, and distinguish retryable overload from non-retryable model errors.

Balance prefill and decode

Long prompts create large prefill bursts that can delay already-running generations. Review the prefill scheduling interval, documented by vLLM with a default example of 1, and validate changes under representative prompt distributions. Adjusting this interval is a deployment-specific trade-off, not a universal performance setting.

Evaluate asynchronous scheduling and stream cadence

Review asynchronous scheduling and the stream interval. More frequent streaming can improve perceived responsiveness but increases response-handling work; less frequent updates may reduce overhead while making gaps look larger to a client. Measure both TTFT and inter-token latency after each change.

Use batch size or queue size deliberately

Google Cloud recommends queue size as an autoscaling signal when the target latency is achievable and throughput or cost is the priority. When the latency target is tighter, batch size can trigger faster scale-up. Larger batches can raise throughput, while smaller or faster-triggered batches generally protect response time.

Which autoscaling signals work better than GPU utilization?

Combine demand and user-experience signals. AWS recommends queue depth, TTFT, and request latency alongside utilization because utilization can remain near 100% across a broad demand range.

Signal Best use Risk if used alone
Queue depth or queue-size percentile Detects work waiting for admission; Google Cloud suggests beginning around thresholds of 3–5 and tuning under load. Can scale on a transient burst unless smoothed.
TTFT Protects interactive first-token experience. Can be dominated by prompt-length mix.
End-to-end p95 or p99 Captures the user-visible tail. Scales after latency has already degraded.
Batch size or active sequences Provides a fast capacity signal for tight latency targets. Does not show whether requests are already waiting.
GPU utilization Confirms that the device is busy. Does not quantify queueing or remaining headroom.

Set scale-up and scale-down windows separately. Scale up on a short sustained breach of queue, TTFT, or p95; scale down only after queues drain and cache usage remains safely below the limit. Validate the initial 3–5 queue-size starting point against your request rate, service time, and replica startup delay rather than treating it as a universal threshold.

Independent reader supportYour contribution helps us test, update, and keep practical guides available for everyone.Support on Ko-Fi

Why do timeouts happen when GPU utilization is high?

High utilization indicates that the device is busy, not that it is processing each request within the required deadline. A full device can spend its time on prefill for a few very long prompts while short requests wait, or on decode work that keeps many sequences alive.

  • Long prompts: prefill consumes compute and cache before the first token can be emitted.
  • Long generations: decode slots remain occupied, reducing admission capacity for new work.
  • KV-cache exhaustion: requests wait, swap, or are preempted, adding delay that GPU utilization does not expose.
  • Oversized mixed batches: throughput may improve while TTFT or inter-token latency violates the product target.
  • Head-of-line blocking: one traffic class can delay another when all requests share a queue.

During a controlled load test, watch queue depth and p95 end-to-end latency together. Saturation commonly appears as a queue spike followed by a latency spike; utilization alone cannot identify that transition.

How do I investigate a hang or timeout in vLLM?

Increase diagnostics narrowly and temporarily, then return to normal logging after collecting evidence.

  1. Set VLLM_LOGGING_LEVEL=DEBUG to expose request and scheduler detail.
  2. Set VLLM_LOG_STATS_INTERVAL=1 to emit frequent statistics while reproducing the issue.
  3. For suspected CUDA kernel synchronization faults, run with CUDA_LAUNCH_BLOCKING=1. This changes execution timing, so use it for diagnosis rather than steady-state serving.
  4. For distributed communication problems, set NCCL_DEBUG=TRACE and correlate ranks, timestamps, and the request that was active.
  5. Use VLLM_TRACE_FUNCTION=1 only for a narrowly scoped reproduction. vLLM documentation warns that function tracing can make token generation more than 100 times slower, so it can create symptoms that do not represent production behavior.

Capture the request identifier, replica, model revision, prompt and generation token counts, scheduler state, cache usage, and the last phase that emitted progress. Disable the extra diagnostics after the trace to avoid unnecessary overhead and log volume.

How do I trace the complete timeout path?

List every deadline from the client to the model and identify which component closed the connection first.

  1. Client request deadline and cancellation behavior.
  2. API gateway or ingress request timeout.
  3. Service-mesh request and idle timeouts.
  4. Load-balancer idle timeout, especially for streaming responses.
  5. Inference-server request timeout and cancellation handling.
  6. Model-level cancellation or scheduler rejection.

Set each budget from measured p95 or p99 phase latency plus an explicit operational margin. There is no universal timeout value established for all models and deployments. For streaming APIs, verify that the idle timeout permits the longest expected inter-token gap, not merely the total completion duration.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

What should I change first during an incident?

Prefer reversible controls that stop the queue from growing while preserving useful evidence.

  1. Confirm whether the queue, prefill, decode, cache, or external timeout is the dominant phase.
  2. Stop sending additional traffic to an unhealthy replica and check whether its metrics diverge from peers.
  3. Reduce or cap active sequences and queued requests if cache pressure or tail latency is endangering all traffic.
  4. Add capacity or accelerate scale-up when queue depth and TTFT remain high after admission is bounded.
  5. Route long-context or high-generation requests to an isolated pool when they cause head-of-line blocking.
  6. Adjust batching or prefill scheduling one setting at a time, then compare p50, p95, p99, TTFT, inter-token latency, and throughput.
  7. After recovery, replay a representative prompt and generation-length mix to verify that the fix holds beyond the incident’s traffic shape.

Operational checklist

  • Dashboards show Triton or vLLM phase metrics, queue states, cache usage, status codes, and token-length distributions.
  • Alerts cover queue depth, TTFT, p95/p99 latency, swapped or preempted requests, and HTTP 503 rates.
  • Autoscaling combines queue or batch signals with user-facing latency rather than relying only on GPU utilization.
  • Admission limits, retry backoff, and fallback behavior are documented and tested.
  • Timeout budgets are aligned across client, proxy, load balancer, server, and model cancellation layers.

Frequently Asked Questions

Should I alert on average inference latency or percentiles?

Use percentiles for paging and service-level objectives, especially p95 and p99, because queue bursts and long prompts create tail failures that averages hide. Keep p50 as a baseline for normal behavior and investigate when the gap between p50 and p99 widens.

What does a high TTFT with normal token streaming usually mean?

It usually indicates waiting or prompt-prefill contention before generation starts, rather than a slow decode loop. Compare queue time, prompt-token counts, waiting requests, and prefill duration for the affected interval.

How can clients behave when the inference server returns HTTP 503?

Treat 503 as controlled overload when the configured in-flight limit is reached. Retry with exponential backoff and jitter, honor a total deadline, and use a fallback or degraded response path so retries do not create another queue surge.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Why can a streaming request appear frozen even though the model is still running?

A long inter-token gap, a proxy idle timeout, or buffered streaming output can all look like a hang. Compare server-side inter-token latency with the client-observed arrival times and inspect every intermediary’s idle-timeout and buffering behavior.
