Intermittent slowness in an AI API is rarely explained by the model alone. The reliable way to find the cause is to measure tail percentiles, separate time to first token from generation time, trace every dependency, and correlate delays with tokens, queues, capacity, throttling, cold starts and retries. Start by defining exactly which model, deployment, region, users and time window are affected; then use those dimensions consistently while you compare fast and slow requests.

This method distinguishes a longer prompt or completion from infrastructure pressure and from delays introduced by retrieval, tools, external APIs or retry storms. It also gives you the evidence a cloud provider needs if the problem is in its serving layer.

What does inconsistent latency in a cloud AI service usually mean?

Inconsistent latency means that requests with apparently similar inputs take materially different times to begin responding or to finish. The variation may come from token volume, queueing, autoscaling, cold starts, throttling, retries, downstream services or the model-serving platform. Averages conceal this behavior, so troubleshoot the distribution of latency rather than a single mean value.

Two requests can have the same HTTP status and model name yet follow different paths: one may hit a warm instance with no retrieval call, while another waits for capacity, performs a tool call and is retried after a transient error. Your instrumentation must expose those paths.

How do I scope the latency symptom before changing anything?

Write a precise incident statement before tuning infrastructure or changing prompts. Provider consoles and support teams can only isolate a fault when the affected dimensions are explicit.

Record the affected dimensions

  • Model, model version if exposed, deployment or endpoint, service tier and project or subscription.
  • Cloud region and the client populations or measurement locations that see the slowdown.
  • UTC start and end times, request volume, concurrency and HTTP status-code mix.
  • The percentile that moved (p50, p75, p90, p95 or p99), its previous value and its current value.
  • Whether the symptom is delayed first output, slow token delivery, long completion time, connection setup or all of them.
  • Recent changes to prompts, retrieval indexes, tools, networking, autoscaling settings, SDKs, deployments and retry policies.

Use one set of dimensions for every dashboard and query. OpenAI’s service-health guidance recommends filtering by a single model, tier and project. Google App Engine guidance similarly calls for the affected applications, versions, endpoints, clients, time range, percentile change, measurement location, dependencies and recent changes.

Compare like with like

Separate streaming and non-streaming requests, short and long prompts, and different response-size limits. A mixed graph can make a change in traffic shape look like a platform regression. Keep status codes and cancellations visible; a fast error is not equivalent to a successful response.

Which latency percentiles should I graph?

Graph p50, p75, p90, p95 and p99 when your traffic volume supports them. P50 describes the typical request, while p95 and p99 reveal the users waiting at the tail. OpenAI explicitly advises reviewing P50, P75 and P95 because averages can hide real-user impact; Gemini Enterprise surfaces p50 and p95 cards and time series.

Read the shape, not just the highest number

  • p50 rises with p95: a broad change affects most requests, such as larger prompts or a regional service issue.
  • p50 is flat but p95 and p99 rise: queueing, uneven load, cold starts, throttling or a small set of slow dependencies is more likely.
  • Only one client location worsens: investigate that network path, region or dependency before blaming the model.
  • Percentiles jump with error rates: inspect throttling, timeouts and retries rather than looking only at successful requests.

Always attach the sample count and time window to a percentile. A p99 calculated from a handful of calls is a directional signal, not a stable service-level measurement.

How do I separate TTFT, token delay and total response time?

For a streaming response, measure three intervals independently: time to first token (TTFT), time between tokens (TBT) and time to last token (TTLT). Azure documents the relationship as TTLT = TTFT + (TBT × Tokens Generated). These metrics answer different user-experience questions and point to different causes.

Metric What it measures What commonly changes it
TTFT Request start until the first token or first response bytes arrive Prompt-token processing, queue time, connection setup, cold starts and retrieval or tool work before generation
TBT Average interval between generated tokens Serving throughput, model load, throttling, batching and output-side dependencies
TTLT Request start until the final token is delivered TTFT, TBT and the number of generated tokens

Log prompt tokens and generated tokens beside all three timings. A longer prompt can increase TTFT; a longer answer can increase TTLT even when the model’s token rate is unchanged. If token counts stay flat while TTLT rises, investigate queueing, capacity, retries and infrastructure pressure.

Instrument the client correctly

Timestamp the request immediately before sending it, the first response event, every streamed chunk and the final event. Distinguish server processing from client-side buffering: a proxy that flushes data in batches can make TTFT or TBT appear worse than the service actually is. Record cancellation time separately so abandoned generations do not contaminate completion-latency statistics.

How can I tell whether the model or my cloud infrastructure is slow?

Trace the complete request path and assign a duration to every segment. A model-call timer by itself cannot reveal time spent waiting in your queue, fetching documents or retrying an upstream request.

Create a correlated trace

  1. Generate or propagate a request ID at the edge and include it in application logs, provider calls and responses.
  2. Record ingress, queue-enter, queue-exit, model-request start, first-byte, each stream event and completion timestamps.
  3. Create child spans for retrieval, vector search, prompt assembly, safety checks, tool calls, external APIs, serialization and response delivery.
  4. Annotate each span with model, deployment, region, prompt-token count, generated-token count, status code, retry number and timeout.
  5. Join logs, metrics and traces by request ID and inspect slow traces rather than only aggregate charts.

Google warns that unlogged dependencies can make downstream delay look like Cloud Run latency. AWS describes generative-AI systems as distributed, stateless and composed of ephemeral compute plus integrated AI services; its guidance recommends CloudWatch Logs, metrics, X-Ray and Bedrock traces for these workflows.

Use a simple attribution test

  • If queue time grows before the provider call, your service or deployment is capacity constrained.
  • If the provider call’s TTFT grows while your queue and dependency spans remain stable, inspect model-service health, regional capacity and prompt size.
  • If retrieval or tools consume the added time, optimize or parallelize those calls and set explicit budgets for them.
  • If the first attempt is normal but the overall request is slow, inspect retries and fallback calls.

Which capacity and scaling signals explain intermittent delays?

Plot latency with concurrency, request rate, deployment utilization, pending requests, queue time, throttling and cold-start counts. Capacity problems often appear first in the tail, while median latency remains acceptable.

Queueing and concurrency

When concurrent requests approach a deployment or worker limit, new calls wait. Compare queue-enter to model-start time and look for 429 responses or provider-specific throttling indicators. A rising queue with flat token counts is evidence against output length as the primary cause.

Autoscaling and cold starts

Autoscalers add instances only after demand changes, so a sudden burst can encounter pending work or initialization delay. Google recommends increasing minimum instances to reduce cold starts. Measure cold-start requests separately from warm requests before changing the minimum; keeping more instances ready trades lower startup latency for greater baseline resource use.

Utilization and saturation

Check CPU, memory, accelerator utilization where exposed, connection pools and worker saturation. Azure guidance recommends checking utilization and request volume when TTLT rises without token growth. Do not infer saturation from CPU alone: a blocked connection pool or provider quota can create the same symptom.

How do retries create a latency feedback loop?

Retries turn one slow or failed operation into several attempts. Measure retry count, backoff duration, fallback rate and the status code that triggered each attempt.

What to log

  • Attempt number and the original request ID.
  • Triggering status or exception, including 429, 5xx and timeout categories.
  • Backoff schedule and total time spent waiting.
  • Whether a fallback model, region or provider was used.
  • Tokens consumed by unsuccessful and successful attempts, where available.

More retries increase load precisely when capacity is already stressed. An Azure incident review dated 29 May 2026 described an upstream change that surfaced capacity failures differently; unexpected retry traffic then overwhelmed a shared inference load balancer across regions during a 09:39–17:05 UTC event window. The lesson is to treat retry policy as part of capacity planning, not merely error handling.

Make retries observable and bounded

Set a maximum attempt count and an overall deadline, and emit a metric for retries per completed request. Use jittered backoff so many clients do not retry simultaneously. Ensure a timeout does not allow the original server-side generation to continue consuming capacity unnoticed.

How should I investigate retrieval, tools and external dependencies?

Break every non-model operation into its own span and report its contribution to TTFT and TTLT. “The model was slow” is an invalid conclusion when document retrieval, a tool call or an external API accounts for most of the trace.

Retrieval path

Measure query construction, embedding generation, vector search, metadata filtering, document fetch and prompt assembly separately. Track result count and payload size because larger retrieved context increases prompt tokens and therefore can increase TTFT.

Tool and API path

Record each tool’s DNS, connection, server and serialization time where possible. Distinguish sequential calls from parallel calls; one slow branch can dominate a sequential chain. Apply per-dependency timeouts and return a controlled partial result when the product can tolerate it.

Network and serialization

Compare client-to-edge, edge-to-service and service-to-provider timings. Large JSON payloads, compression, TLS handshakes and proxy buffering can add delay without appearing in model metrics.

Which provider diagnostics can confirm a platform-side problem?

Use the observability native to your cloud, then correlate it with application traces rather than replacing them.

  • Azure-hosted agents and Azure OpenAI workloads: send the x-ms-debug-latency-enabled: true request header when supported. The returned diagnostic headers help separate platform, provisioning, container-readiness and request-processing time. Azure Monitor can supply utilization, request and dependency views.
  • Google Cloud Run or Gemini workloads: combine Cloud Monitoring metrics with Cloud Trace. Examine application version, endpoint, region, measurement location and dependency spans; increase minimum instances when cold starts are confirmed.
  • AWS Bedrock workflows: combine CloudWatch logs and metrics with X-Ray and Bedrock traces to follow ephemeral compute, model calls and downstream services.
  • OpenAI services: use service-health views filtered to one model, tier and project, and compare the provider’s percentile time series with your request-level traces.

Before relying on any dashboard, verify its aggregation window, percentile definitions, token fields, regional coverage and retention. Provider cards may show service time while your users experience network, queue and dependency time as well.

What is a practical step-by-step runbook for a latency spike?

  1. Freeze the scope: write the model, deployment, region, client group, UTC window, request volume, status codes and affected percentile.
  2. Split the experience: graph TTFT, TBT and TTLT for streaming requests; graph full request time separately for non-streaming calls.
  3. Overlay tokens: plot prompt and generated-token counts against each latency series.
  4. Inspect tails: compare p50, p75, p90, p95 and p99 and identify whether only the tail or the whole distribution moved.
  5. Open slow traces: attribute time to queueing, retrieval, tools, external APIs, retries, model processing and response delivery.
  6. Check saturation: review concurrency, pending work, utilization, cold starts, minimum instances, quotas and throttling.
  7. Audit retries: quantify attempts, backoff, fallbacks and the status codes that triggered them.
  8. Compare regions and versions: determine whether a single deployment, application version or measurement location is affected.
  9. Apply one controlled change: for example, raise minimum instances, cap retries or remove a slow dependency, then observe the same percentiles and token mix.
  10. Preserve evidence: retain representative fast and slow request IDs, traces and UTC timestamps before dashboards roll over.

What common patterns point to a specific fix?

Observed pattern Most useful next check Likely action
TTFT rises, prompt tokens also rise Retrieval result size and prompt assembly spans Reduce unnecessary context, cap retrieval payloads or optimize pre-processing
TTFT rises, tokens stay flat, queue time rises Concurrency, pending requests and throttling Address capacity, quotas, autoscaling or request admission
TTFT is normal, TBT slows, generated tokens stay similar Serving throughput and deployment utilization Investigate model-service saturation, batching and regional capacity
Only TTLT rises while TTFT and TBT are stable Generated-token count and client completion handling Check output-length changes, stream termination and buffering
Latency and 429/5xx rates rise together Retry count and backoff spans Bound retries, add jitter and resolve the underlying quota or capacity fault
One application version or region is slow Version-level traces and dependency differences Roll back or route traffic while isolating that deployment

What should I send when escalating to the provider?

Provide a compact, reproducible packet rather than screenshots alone:

  • Exact UTC timestamps and the duration of the incident.
  • Model, deployment, API version if relevant, service tier, project or subscription and region.
  • p50, p75, p95 and p99 charts with sample counts and the comparison baseline.
  • TTFT, TBT and TTLT distributions, plus prompt and generated-token distributions.
  • Request IDs, status codes, throttling indicators and retry counts for representative slow calls.
  • Trace IDs showing queue, dependency and provider-call spans.
  • Recent configuration, prompt, traffic, autoscaling and client changes.

Remove secrets and personal data while preserving identifiers that let the provider locate the request. Include both a fast and a slow example with the same model and region; that contrast is often more useful than a single extreme outlier.

How do I prevent the next intermittent-latency incident?

  • Define service objectives separately for TTFT and TTLT instead of using one blended number.
  • Keep percentile dashboards partitioned by model, deployment, region, client and streaming mode.
  • Alert on tail movement together with request volume, tokens, queue time, throttling and retries.
  • Maintain distributed tracing with stable request IDs and dependency spans.
  • Exercise cold-start, burst-concurrency, quota-exhaustion and dependency-timeout scenarios in a controlled environment.
  • Review retry policies whenever an upstream provider changes status-code behavior.
  • Retain enough logs and traces to compare an incident with a known-good period.

Frequently Asked Questions

Should I alert on p95 or p99 latency?

Use p95 for a primary user-impact signal when traffic is steady, and track p99 as a diagnostic tail signal. Set thresholds from your own normal distribution and require a minimum request count so a few calls do not create noisy alerts.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Can streaming make an endpoint appear faster than it really is?

Yes. A quick first token can improve perceived responsiveness while a slow token cadence leaves the user waiting for completion. Report TTFT and TTLT separately, and include the generated-token count when comparing streaming performance.

How can I compare latency between cloud regions fairly?

Run the same request shape, model, token limits and client software from consistent measurement locations, then compare matching percentiles and sample counts. Keep network distance and regional dependency placement documented because they can dominate the result.

What if my service has logs but no distributed tracing?

Add a request ID and timestamp fields around each boundary first: queue, retrieval, tools, provider call, retry and response delivery. You can reconstruct a basic waterfall from correlated logs, then adopt OpenTelemetry or the provider’s tracing integration for sampling and dependency visualization.
