Do not approve an AI model because its average answer looks polite. Test it with a documented, risk-based evaluation that combines matched demographic prompts, stereotype and truthfulness benchmarks, adversarial cases, and independent human review. Measure differences by group, language, scenario, and failure severity, then compare the results with acceptance thresholds set before testing. Keep a held-out set for the final decision and repeat the checks after every material model, prompt, retrieval, or policy change.

This approach can reveal stereotyping, moralizing, unsupported assumptions, unequal helpfulness, harmful escalation, and inconsistent recommendations before users encounter them. It also makes a failure auditable: you can show which prompt produced it, who reviewed it, how serious it was, and whether the fix actually worked.

What should a pre-use bias test prove?

A useful evaluation answers two separate questions: Does the model behave differently when an irrelevant identity or social attribute changes? And does it respond safely and respectfully when the subject itself is sensitive? A model can pass one question and fail the other. For example, it may give equal answers to matched names but still use demeaning language about disability or poverty.

Write the intended use in plain language before choosing prompts. State who will receive the output, what decisions or actions may follow, which groups could be affected, and what harm a bad answer could cause. A hiring assistant, a mental-health information bot, and a customer-support classifier need different tests and different tolerances for error.

  • Affected groups: include demographic and social groups that appear in the product or could be targeted by it, not only groups represented in a benchmark.
  • Foreseeable harms: list stereotyping, exclusion, harassment, privacy exposure, unsafe advice, denial of service, escalation of a hostile premise, and unequal quality of help.
  • Acceptance criteria: define what counts as a pass, a warning, and a release blocker for each harm type before looking at results.

NIST’s AI Risk Management Framework Measure guidance says AI systems should be tested before deployment and regularly while in operation, with fairness and bias results evaluated and documented. Australia’s National AI Centre similarly advises organisations to define acceptance criteria and test methods that reflect intended use, context, and potential risks. ISO/IEC TR 24027:2021 provides guidance for measuring bias across AI-system lifecycle phases.

How do I set risk-based pass and fail thresholds?

There is no universal published pass/fail percentage for bias. A threshold that might be tolerable for a low-impact writing aid could be unacceptable for a system influencing employment, credit, health, education, housing, or access to public services. Set thresholds per use case and risk tolerance, and record the rationale.

Define severity levels

A four-level scale is practical when reviewers need to make consistent decisions:

  1. Level 0 — acceptable: respectful, relevant, and comparably helpful across matched cases.
  2. Level 1 — minor issue: awkward wording, an unnecessary assumption, or a small quality difference that does not create material harm.
  3. Level 2 — material bias or safety weakness: stereotyping, moralizing, differential helpfulness, unsupported risk claims, or a refusal that blocks one group more than another.
  4. Level 3 — critical failure: explicit demeaning content, dangerous advice, discriminatory recommendation, protected-class targeting, or escalation that could plausibly cause serious harm.

Decide in advance whether any Level 3 response blocks release, whether a maximum Level 2 rate is allowed, and whether a single severe case requires a product or policy change. Also set minimum sample sizes for each important subgroup; a zero observed failure in a tiny sample is not strong evidence of safety.

Separate average quality from equity

Report an overall score only alongside disaggregated results. An average can look excellent while a smaller language, age, disability, or religious group experiences most of the failures. Treat large gaps in refusal quality, factual confidence, recommendation, or helpfulness as findings even when the overall average is high.

How should I build the prompt test set?

Start with real tasks from the intended product, then add controlled variations. Keep the final evaluation set held out so that prompt wording is not repeatedly tuned against the same examples.

1. Collect representative real-task prompts

Sample the questions users are expected to ask, including short and long messages, misspellings, different reading levels, code-switching, and realistic context. If the model uses retrieval or tools, preserve the documents, tool outputs, and system instructions that would be present in production. Remove personal data or obtain the approvals required to use it.

2. Create matched counterfactual pairs

Change one demographic or social attribute at a time while holding the task constant. Depending on the use case, vary names, pronouns, age, disability status, race or ethnicity, religion, nationality, sexual orientation, socioeconomic status, appearance, or dialect. The pair should differ only in the attribute being tested; otherwise a response difference may have a legitimate explanation.

For each pair, compare factual content, confidence, recommendation, tone, refusal, requested evidence, and next steps. A model that offers detailed guidance to one name but a vague warning to another has a disparity even if neither answer contains an insult.

3. Add ambiguous and underspecified prompts

Judgment often appears when the user leaves room for assumptions. Include prompts where gender, occupation, family role, income, competence, criminality, or health status is not stated. Check whether the model asks a neutral clarifying question or fills the gap with a stereotype.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

4. Add adversarial and likely-misuse prompts

Probe attempts to elicit slurs, ranking of groups, discriminatory screening, humiliation, or justification of a biased premise. Include role-play, “just for research” framing, indirect requests, quoted offensive text, and multi-turn escalation. Record whether the model de-escalates, refuses the harmful part, and still offers a safe alternative.

5. Freeze a held-out set

Keep a private set of prompts untouched until the final evaluation. Include every important prompt family and subgroup in it. Document who created each item, the intended answer characteristics, and any legitimate reasons a response could differ. Version the set so later runs can be compared.

Which benchmarks and test families should I use?

Use several complementary probes rather than treating one benchmark as a certificate. Benchmarks expose known patterns; custom prompts and human review determine whether the model is acceptable in your context.

Stereotype and association tests

Use BOLD, CrowS-Pairs, BBQ, Winogender, and, where appropriate, StereoSet-style paired completions. These resources test associations or choices involving social groups. Run the benchmark in the same language, model configuration, and safety wrapper used by the product, then add local examples that reflect your users.

Judgmental and demeaning-language tests

Write prompts about disability, race, religion, nationality, gender, age, sexuality, appearance, poverty, and mental health. Ask for advice, summaries, explanations, and decisions—not only direct insults—because judgment can appear as moralizing, an unsupported assumption, a lower-quality answer, or a harsher refusal. Have trained reviewers label each response for insult, moralizing, assumption, differential helpfulness, and refusal quality.

Toxicity and safety tests

Include RealToxicity-style prompts and adversarial red-team variants. Record the target group, severity, whether the model repeats or intensifies harmful framing, and whether it redirects to a safe response. Test multi-turn conversations because a model may resist a first request and then yield after pressure.

Truthfulness and consistency tests

Use TruthfulQA-style questions and repeat equivalent questions across language, dialect, reading level, and context. Check whether factual confidence, uncertainty statements, or recommendations change without a legitimate reason. A biased answer is not always openly hostile; unjustified confidence or a different factual standard can produce unequal harm.

Human and community review

Use independent reviewers and, when relevant, people representative of affected communities. Reviewers should see the prompt, model configuration, and output, but not be told which condition is the “favored” one. Record inter-rater disagreement and adjudication decisions instead of hiding disagreement inside a single score.

What do the named datasets actually cover?

The following figures describe the resources as documented by their cited maintainers and guidance pages. They indicate scope, not a guaranteed level of coverage for your application.

Resource Documented size or scope How to use it
BOLD 23,679 English prompts; five domains: profession, gender, race, religion, and political ideology Probe generated language and associations, then inspect outputs by domain and subgroup.
CrowS-Pairs 1,508 examples Compare paired completions for stereotypical versus less-stereotypical statements; add local counterfactuals.
TruthfulQA 817 questions across 38 categories Check whether answers remain truthful and appropriately uncertain across demographic and linguistic variants.
ISO/IEC TR 24027:2021 Technical report published in 2021 Use its lifecycle perspective to plan bias measurement from design through operation.

AWS documents that its CrowS-Pairs implementation is English-only, reflects US stereotypes, and includes noisy crowd-sourced items. Google notes that implementations can produce different results and that benchmarks may saturate as models improve. Consequently, a benchmark score should be treated as a probe, not a safety certificate.

How do I run the evaluation reproducibly?

Small configuration changes can alter model behavior. Freeze the conditions, repeat stochastic calls, and make every result traceable to a model version and prompt set.

  1. Record the model identity: provider, model name or checkpoint, release date, deployment region, context limit, and safety-policy version.
  2. Record the application wrapper: system prompt, developer instructions, retrieval documents, tool definitions, filters, temperature, top-p or equivalent sampling controls, maximum output length, and timeout behavior.
  3. Version the data: prompt-set identifier, language, subgroup labels, expected properties, reviewer rubric, and held-out-set identifier.
  4. Repeat stochastic prompts: run multiple samples with fixed seeds where supported, and otherwise record each response. Report both per-run outcomes and aggregate rates.
  5. Preserve raw evidence: store prompts, outputs, timestamps, configuration, reviewer labels, and adjudication notes under an access policy that protects sensitive content.
  6. Run the held-out set last: do not tune prompts, policies, or scoring rules on those examples before the release decision.

If the product will be multilingual, run the same intent in each supported language and dialect rather than translating only a small English test. Translation can remove the very ambiguity, identity marker, or cultural context that triggers a judgmental response.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

How should reviewers score judgmental behavior?

A written rubric is more reliable than asking reviewers whether an answer “feels biased.” Give each response a binary or graded label for every behavior relevant to the use case, with examples and an escalation path for difficult cases.

Core labels

  • Insult or demeaning language: direct slur, ridicule, contempt, or language that treats a group as less worthy.
  • Moralizing: assigning blame, virtue, laziness, danger, or character from identity or circumstance without evidence.
  • Unsupported assumption: inferring income, criminality, competence, health, family role, or intent from a demographic cue.
  • Differential helpfulness: materially less detail, fewer options, lower effort, or a more dismissive tone for an otherwise equivalent request.
  • Unequal refusal quality: refusing one group’s benign request, or giving one group a punitive explanation while offering another a useful alternative.
  • Harmful escalation: accepting a hostile premise, adding new allegations, encouraging exclusion, or intensifying a user’s attack.
  • Safe redirection: declining the harmful part while answering a legitimate underlying need in neutral language.

Adjudicate disagreements

Use at least two independent reviewers for high-risk items. When they disagree, preserve both labels, ask for a reason tied to the rubric, and have a qualified adjudicator decide. Track agreement by prompt family and subgroup; a low agreement rate may mean the rubric is unclear or that the model’s behavior is genuinely ambiguous.

Which metrics reveal disparities instead of hiding them?

Calculate rates separately for every meaningful slice: demographic group, paired condition, language, dialect, prompt family, deployment scenario, and failure type. Include sample counts and an uncertainty estimate such as a confidence interval, especially when groups have different numbers of examples.

Useful comparisons

  • Failure rate: the share of responses receiving each severity level.
  • Pairwise disparity: the difference in failure, refusal, helpfulness, or recommendation rate between matched conditions.
  • Worst-group result: the highest failure rate among groups that meet the minimum sample requirement.
  • Severity-weighted rate: a predeclared weighting that prevents many minor passes from masking a small number of critical failures.
  • Consistency rate: the share of equivalent prompts receiving materially equivalent facts, confidence, and next steps.
  • Reviewer agreement: agreement and adjudication frequency for each label.

Show representative outputs alongside metrics. A table of rates tells decision-makers where a problem is; the actual excerpts reveal whether it is a stereotype, a refusal bug, a translation issue, or a legitimate difference in the task.

What should I do when the model fails?

Classify the cause before changing the model. A response may be driven by the system prompt, a retrieval document, a safety policy, training data, a tool result, or an interaction between them.

Prompt and policy fixes

Clarify that the assistant must not infer protected traits or moral character without evidence, should ask for missing context, and must provide equivalent assistance for matched legitimate requests. Tighten refusal and redirection language, then rerun both benign and adversarial prompts to ensure the fix does not over-refuse.

Data and retrieval fixes

Remove or correct sources that encode stereotypes, add balanced examples of the affected tasks, and test retrieval ranking by subgroup and language. Do not assume that adding a disclaimer compensates for a source that repeatedly supplies biased premises.

Model or routing fixes

If the behavior persists across wrappers and sources, evaluate a model change, a safer routing rule, or human review for the affected workflow. Document the trade-off: a change that lowers toxicity may also reduce legitimate discussion or increase refusal disparities.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Rerun and compare

Run the complete held-out set after every material remediation. Compare the new run with the previous version using the same slices, severity definitions, and uncertainty reporting. A fix is not complete if it improves one subgroup while creating a new disparity elsewhere.

Should I use a managed evaluator or an open framework?

Choose tools according to your data controls, cloud environment, reproducibility needs, and evaluation depth. The tool does not replace a local prompt set or human review.

Option Best fit Relevant capability or limitation
Amazon SageMaker AI FMEval Teams already operating in AWS Managed prompt-stereotyping evaluation using CrowS-Pairs or custom datasets.
Stanford CRFM HELM Teams wanting an open, reproducible framework Standardized datasets, bias and toxicity metrics, unified model access, and result inspection.

Stanford’s documentation says HELM entered maintenance mode on June 1, 2026. Verify current support, dependencies, and security posture before adopting it for a new production program. For either option, confirm where prompts and outputs are stored, who can access them, how custom labels are represented, and whether the implementation matches the benchmark’s original conditions.

How do I make the go/no-go decision?

Use a written decision record rather than a single leaderboard number. The record should include the intended use, affected groups, prompt-set versions, model configuration, sample sizes, uncertainty estimates, reviewer agreement, representative failures, remediation history, and the person accountable for approval.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Approve only when

  • Every critical failure category has a predeclared disposition and no unresolved release blocker.
  • Results meet the thresholds for the intended use across required groups, languages, and scenarios.
  • Material differences have a documented, legitimate explanation or a mitigation accepted by the risk owner.
  • Human escalation, appeal, logging, and incident-response paths are operational.
  • The held-out evaluation was run after tuning and its outputs were independently reviewed.

Do not hide uncertainty

If a subgroup has too few examples, say that the estimate is imprecise and collect more data before expanding use. If reviewers disagree frequently, improve the rubric or require human review for those cases. If a benchmark conflicts with local evidence, investigate the mismatch rather than averaging the scores.

How do I monitor bias after launch?

Pre-release testing is a baseline, not a permanent guarantee. Log production incidents, user appeals, overrides, and examples of suspected disparate treatment under an appropriate privacy policy. Sample new prompts for the same failure labels used before launch, and watch for changes after model updates, retrieval changes, policy edits, traffic shifts, or new languages.

Schedule re-evaluation at a cadence suited to risk and whenever a material component changes. Feed confirmed incidents back into the custom test set, but keep a separate held-out portion so future results remain meaningful. Review trends by subgroup and scenario, not only the total number of complaints.

What are the most common testing mistakes?

  • Relying on one benchmark: add custom, local, multilingual, adversarial, and human-reviewed cases.
  • Testing only explicit slurs: look for unequal detail, confidence, assumptions, recommendations, and refusals.
  • Changing several attributes at once: use one-attribute counterfactual pairs so differences are interpretable.
  • Tuning on every example: freeze a held-out set and run it only for the final comparison.
  • Reporting only averages: slice by group, language, scenario, and severity with sample sizes.
  • Ignoring implementation details: record system prompts, temperature, retrieval, tools, and safety settings.
  • Treating benchmark output as certification: benchmarks can saturate, implementations differ, and some datasets reflect a particular language or culture.
  • Skipping community input: involve people who understand the affected groups and record disagreement instead of suppressing it.
  • Stopping at remediation: rerun the complete held-out set and monitor production for drift.

A defensible approval is therefore a documented argument: the model was tested under realistic conditions, severe failures were addressed, disparities were measured rather than averaged away, and ongoing monitoring has an owner.

Frequently Asked Questions

How large should an AI bias test set be?

There is no single correct total because the required size depends on the number of groups, languages, scenarios, and the precision you need. Set a minimum sample for each important slice, report uncertainty, and expand any subgroup whose estimate is too imprecise to support a release decision.

Can an automated toxicity score detect a judgmental answer?

Not reliably on its own. Automated scores can miss unequal helpfulness, subtle moralizing, unsupported assumptions, and culturally specific insults, so pair them with a written rubric and independent human review.

Should I test the base model or the finished chatbot?

Test the finished system, including system and developer prompts, retrieval, tools, filters, temperature, and refusal policies. A base-model result can be useful for diagnosis, but it does not predict behavior after the application wrapper changes the context.

What if a model is safer but refuses too many legitimate questions?

Measure refusal rate and refusal quality on matched benign prompts as well as adversarial ones. A mitigation is incomplete if it lowers harmful content by denying one group’s ordinary requests or by giving that group less useful alternatives.
