Estimate AI storage in separate buckets: datasets and their processed copies, model artifacts, training checkpoints, inference files and runtime data, and retained versions. Then add temporary-space headroom. For training, parameter count alone is not enough: optimizer state and gradients can make a checkpoint several times larger than the model’s stored weights. Size storage throughput separately by dividing the amount written in each checkpoint by the time between checkpoints.
What storage do AI training and inference workloads need?
Storage planning has two distinct questions: how much capacity must be available, and how quickly the system must read or write it. Capacity is usually driven by dataset copies and checkpoint retention; throughput is driven by checkpoint frequency, concurrent jobs, and the number of workers reading or writing at once.

Build the estimate from these buckets rather than treating “the model size” as the whole requirement:
- Datasets and copies: source data, transformed or tokenized data, sharded training files, validation and test sets, and staging copies.
- Model artifacts: base weights, tokenizer, configuration, adapters, and exported inference formats.
- Training checkpoints: weights plus whatever gradients, optimizer state, scheduler state, metadata, and framework files the checkpoint contains, along with space needed while writing it.
- Inference runtime: deployed model copies, quantized or unquantized variants, logs, serving caches, and rollout artifacts.
- Retention and headroom: the checkpoint versions kept, plus room for concurrent jobs, failed runs, compaction, temporary files, and growth.
Google Cloud’s TPU planning guidance illustrates how workload assumptions change the estimate. Its figures are starting points per TPU, not universal requirements:

How do I estimate total storage capacity?
First estimate one checkpoint and the footprint of non-checkpoint files; then multiply by the number of retained checkpoints and apply a headroom factor. Keep the components visible so that a change in precision, retention, or dataset processing can be reflected without rebuilding the estimate.

Let P be the number of model parameters; B_w the bytes per stored weight; C the size of one training checkpoint; N the number of retained checkpoints; D the combined dataset, preprocessing, and staging footprint; A the inference artifacts, logs, and serving copies; and H a headroom multiplier for temporary files, fragmentation, and growth.
Estimate the checkpoint as:
C ≈ P × (weight bytes + optimizer-state bytes + gradient bytes + other state bytes)
Then estimate total capacity as:
Total capacity ≈ H × (D + A + N × C)
For a simple weight-artifact estimate, multiply parameter count by bytes per stored weight. BF16 or FP16 uses 2 bytes per weight; INT8 uses 1 byte; a 4-bit format is about 0.5 byte. Actual 4-bit storage can include packing overhead, so verify the framework’s representation rather than assuming the theoretical minimum is the file size.
Count all copies in the dataset footprint
Do not count only the original dataset if preprocessing creates additional files. Add the source, transformed or tokenized output, sharded training data, validation and test sets, and any staging copy that exists at the same time. The relevant number is the amount simultaneously resident, not the size of one copy considered in isolation.

If processing is staged and an intermediate is deleted before the next is created, use the actual peak overlap in the capacity estimate. If the workflow keeps every version, count each retained version. This distinction prevents both underestimating a pipeline that duplicates data and overestimating one that safely reuses space.
Account for artifact and checkpoint contents
Weights are only one part of a training checkpoint. AWS gives a practical baseline of 2 bytes per BF16/FP16 weight parameter plus about 8 bytes per parameter for Adam optimizer state—roughly 10 bytes per parameter before extra framework files. Gradients and additional state may increase the file or write footprint, so confirm what the training framework actually saves.
Also distinguish a saved checkpoint from memory occupied during training. SageMaker’s AMP/Adam accounting is about 20 bytes per parameter when FP16/BF16 weights and gradients, FP32 optimizer state, and FP32 working copies are resident, before activations. That is a training-memory estimate, not a rule that every checkpoint file occupies 20 bytes per parameter.
For inference artifacts, include the base model, tokenizer and configuration, adapters if used, and any separately stored quantized or unquantized version. Add serving copies, logs, cache files, and rollout artifacts only when they are part of the deployment’s storage footprint.
How large can a training checkpoint be?
It can be much larger than the deployed weight file because training preserves optimizer and gradient state. A useful estimate depends on the optimizer, precision, framework, and exactly which state is saved.
Example: a 4-billion-parameter BF16 fine-tuning model
Google Cloud’s fine-tuning example counts 8 GB for BF16 weights, 8 GB for gradients, and 16 GB for AdamW optimizer state, for a 32 GB baseline before activations. This is a worked training-state example, not an inference-artifact size or a guarantee that every framework writes an identical checkpoint.

Example: a 70-billion-parameter AdamW checkpoint
NVIDIA’s example lists 130 GB of BF16 weights, 521 GB of FP32 optimizer state, and 130 GB of gradients, for a stated total of 782 GB. The rounded components sum to 781 GB, so treat the total as an approximate example rather than precision accounting. It shows why a stored inference model is not a safe proxy for the space needed by a training checkpoint.
For a real job, check whether saved files include optimizer and scheduler state, gradients, random-number or metadata state, and temporary checkpoint-writing files. If the goal is to resume training, omitting state may change what can be recovered; the framework’s checkpoint format determines what is actually needed.
How much storage bandwidth do checkpoints require?
Capacity does not tell you whether a checkpoint can finish in the available interval. Google Cloud’s method is to divide checkpoint size by checkpoint interval: required bandwidth = checkpoint size ÷ checkpoint interval. This is the baseline sustained write rate for the stated workload; increase the target when other jobs read or write concurrently or the same storage serves training and inference.
For example, NVIDIA’s cited 70B AdamW case uses a 782 GB checkpoint and an interval of 30 minutes. That is 48 checkpoints per day and about 1.13 PB written over 30 days, using the example’s stated checkpoint size and cadence. The total is cumulative write volume, not the capacity required to retain all of those versions: retention determines how many remain stored at once.
When sizing bandwidth, measure or establish the actual interval and include the full data written, not just weights. A storage tier may have enough nominal capacity but still miss the checkpoint window if sustained writes are too slow. Restart performance matters too: a checkpoint that takes too long to read can extend recovery even if writes fit the training schedule.
How should I estimate inference storage and memory?
Inference generally needs the deployed model artifacts rather than training optimizer and gradient state, so its stored model can be smaller than a training checkpoint. However, the disk footprint and runtime memory are separate estimates: context length, precision, replicas, caches, logs, and rollout strategy affect what the serving system needs.

Estimate the inference artifact footprint
Start with parameter count and deployed weight precision, then add tokenizer and configuration files, adapters, and every concurrently retained model variant. Count each serving replica if it is stored as a separate copy; do not multiply blindly if the deployment shares one artifact across workers. Include logs, cache files, and rollout versions according to their retention and placement.
Use a rough VRAM check, not a disk formula
The Ohio Supercomputer Center gives this FP16 rule of thumb for estimated inference VRAM in GB: 2 × model parameters in billions + 1 × context length in thousands. It is a rough memory check, not a storage-capacity formula, and deployment-specific disk and cache requirements still need separate accounting.
For example, applying the rule to a 4B-parameter model with a 4,000-token context gives approximately 12 GB of estimated VRAM: 2 × 4 plus 4. This does not include a general guarantee about total serving memory or disk use; use it only as a first check against a deployment’s context and precision assumptions.
Independent reader supportYour contribution helps us test, update, and keep practical guides available for everyone. How do distributed training and replicas change the estimate?
Distributed training changes both the checkpoint layout and the number of simultaneous storage operations. Data-parallel replicas and model-parallel shards should therefore be considered separately when estimating saved capacity, checkpoint reads, and aggregate bandwidth.
Do these 3 things before closing this tab:
1Clear out junk files and repair common Windows errors2Fix the driver behind crashes, sound loss and screen glitches3Repair Windows errors before they cause bigger problemsData parallelism
AWS explains that a synchronized data-parallel job may write one model-replica checkpoint, while restart reads can multiply by the number of replicas. A single saved copy therefore does not imply a single-reader recovery workload: many workers may need to read at once, making aggregate read bandwidth and concurrency important.
Model parallelism
Model parallelism shards a model across ranks, changing the checkpoint layout and the concurrency pattern of reads and writes. Plan for the number and behavior of the ranks that participate in checkpointing, rather than applying a single-model file-size assumption to the whole distributed job.
Best Value
For large accelerator jobs, consider what happens when many workers restart together. The storage system must serve the resulting concurrent reads, not merely have enough total capacity to hold the checkpoint. The same principle applies to simultaneous training runs and shared inference traffic.
Which storage tier should hold each part of the workload?
Choose storage by workload behavior after calculating capacity and bandwidth; no one tier is automatically best for every bucket. Compare sustained write bandwidth, restart read bandwidth, latency, durability, concurrent-client behavior, cost, and portability.

| Local NVMe | Scratch space and staging | Whether capacity is sufficient for temporary and overlapping files, and whether required data remains available after the job or machine lifecycle. |
| Shared or parallel filesystem | High-concurrency training access | Sustained aggregate throughput, behavior under concurrent clients, and checkpoint/restart performance. |
| Object storage | Durable datasets and checkpoint archives | Read/write performance for the access pattern, concurrency behavior, durability, and portability requirements. |
A practical design can use different tiers for scratch, active training data, and durable archives. Keep the decision tied to access patterns and lifecycle: fast temporary space does not replace durable retention, and durable storage alone does not establish that a large job can checkpoint or restart on schedule.
What commonly makes a storage estimate wrong?
The most frequent errors come from counting only one artifact, confusing runtime memory with disk capacity, or treating a platform baseline as a workload guarantee. Check the estimate against the workflow’s actual files and concurrency before reserving storage.
- Only counting model weights: include optimizer state, gradients, metadata, framework files, and simultaneous write space where applicable.
- Counting one dataset version: identify transformed, sharded, validation, test, and staging copies that coexist.
- Ignoring retention: multiply the checkpoint estimate by retained versions, then account for in-progress or failed writes.
- Confusing memory and storage: training memory figures may include resident working copies and activations; checkpoint files and inference disk artifacts are different quantities.
- Planning capacity but not throughput: calculate checkpoint size divided by interval, and account for concurrent workloads and restart reads.
- Assuming one checkpoint read: distributed restart behavior can create many readers even if only one synchronized replica was written.
- Using a baseline as a universal rule: Google Cloud’s per-TPU figures correspond to its described workload categories and should be replaced by measured workload components when available.
What is the quickest reliable planning sequence?
Use the following order to turn a workload description into a storage target without mixing disk, memory, and bandwidth assumptions.
- Inventory files: record model parameters and precision, dataset source and processed copies, artifacts, checkpoint contents, logs, caches, and staging data.
- Estimate one checkpoint: count weights, optimizer state, gradients, and other saved state using the framework’s checkpoint format.
- Apply retention: multiply by the number of versions kept and include simultaneous write or recovery files in the peak-space estimate.
- Add non-checkpoint capacity: sum dataset copies and inference artifacts that coexist with retained checkpoints.
- Set headroom: use an explicit multiplier or a separately documented allowance for temporary files, fragmentation, growth, and concurrent jobs.
- Set throughput targets: divide checkpoint size by interval for write bandwidth, then assess concurrent writes and restart reads separately.
- Map buckets to tiers: match scratch, active data, and archives to latency, bandwidth, durability, concurrency, cost, and portability needs.
- Validate against a representative run: compare actual checkpoint size, peak simultaneous files, write duration, and restart read behavior with the estimate, then revise the inputs.
Frequently Asked Questions
Does a checkpoint have to include optimizer state?
It depends on the purpose and the training framework’s format. A checkpoint intended to resume training may need state beyond model weights; an inference export is a different artifact and should be estimated separately.
Can I use the model’s parameter count to estimate inference VRAM?
It gives a starting point when paired with precision and context length, but it is not a complete serving-memory measurement. The Ohio Supercomputer Center’s FP16 rule is explicitly a rough estimate, so validate it against the deployment’s actual runtime configuration.
Why can a small retained-checkpoint count still create heavy storage traffic?
Retention describes how many versions remain, while checkpoint cadence determines how often data is written. A workload can overwrite or expire older versions and still generate a high cumulative write volume.
Should I store training data and checkpoints on the same tier?
Not necessarily. Training data may benefit from concurrent read throughput, scratch files from fast temporary access, and archives from durable retention; compare each bucket’s access pattern and lifecycle against tier capabilities.
