Detect possible model extraction by combining per-actor and per-endpoint telemetry with behavioral baselines. The useful signal is not one suspicious prompt; it is a sustained pattern such as systematic query harvesting, unusual endpoint coverage, repetitive or deliberately varied prompts, response collection, and abnormal error or latency behavior. Rate-limit or challenge high-confidence actors, preserve the related evidence, and use graduated controls because legitimate evaluation, batch jobs, and shared networks can look similar.
This guide shows which logs to collect, how to build segmented baselines, how to add semantic-window detection, and how to investigate without claiming that an anomaly proves theft.

What is model extraction, and why does unusual API traffic matter?
Model extraction (also called distillation) occurs when someone uses legitimate access to systematically probe a trained model and transfer useful behavior or information into a surrogate model. Google Threat Intelligence described observing this pattern in 2025 and published the finding in 2026. The attacker may never exploit a software vulnerability: ordinary API requests, collected at scale, become the training data for a competing model.
The risk is therefore visible in aggregate behavior rather than in a single payload. An isolated request asking for a summary, code, or classification is weak evidence. A sequence of requests that maps capabilities, repeats a prompt family with controlled changes, touches endpoints unrelated to the client’s declared use, and saves unusually large responses is much more informative.

Why a small number of queries can matter
Extraction does not always require millions of calls. In BERT-API extraction experiments reported at ICLR 2020, fewer than 400 queries were sufficient for the demonstrated attack. That figure is an experiment-specific result, not a universal threshold; the required sample depends on the model, task, output detail, and attacker’s prior knowledge. It does show why a detector based only on extreme request volume can miss valuable probing.
What detection can and cannot prove
Telemetry can establish that an actor’s behavior is consistent with possible extraction. It cannot prove model theft from one request or, in many cases, from a single automated score. A customer may be running an authorized evaluation, a scheduled batch job, or a product launch through shared infrastructure. Treat the score as a trigger for verification and proportionate controls.

Capture enough context to connect identity, behavior, and outcomes across time. The following fields support both gateway rules and a custom detector; apply your privacy and retention policy to prompts and embeddings.
| Telemetry | What to record | Why it helps |
|---|---|---|
| Time and sequence | UTC timestamp, request order, session start and end, retry count | Reveals cadence, bursts, pauses, and coordinated activity. |
| Identity | API key, authenticated principal, tenant, service account, session, OAuth client | Allows per-actor limits and avoids treating an entire customer or network as one user. |
| Network origin | Source IP, ASN or network, proxy indicators, geography, and relevant forwarded headers | Shows rotating addresses, shared NAT, regional shifts, and infrastructure relationships. |
| Client metadata | User agent, SDK version, device or workload label, and request headers | Separates known batch clients from newly scripted or inconsistent clients. |
| API target | Endpoint, operation, model name and version, API version, environment, and tenant route | Supports endpoint-specific baselines and identifies capability mapping. |
| Payload shape | Request and response bytes, token counts, content type, parameter choices, and attachment sizes | Highlights repeated schemas, high output-to-input ratios, and systematic parameter changes. |
| Outcome | HTTP status, provider error code, safety or validation result, rate-limit events, and retry-after values | Shows probing through rejected inputs, failed capability tests, and control friction. |
| Performance | Server and end-to-end latency, queue time where available, and timeout state | Unusual latency can accompany concurrency spikes, endpoint abuse, or repeated retries. |
| Semantic features | Prompt embeddings or redacted categories, only where policy permits; retain feature vectors rather than raw text when possible | Detects repetitive prompt families and distribution shifts without exposing full content to every analyst. |
NIST guidance describes bot detection as an evaluation of origin and API-usage patterns over time. Cloudflare API Shield documentation identifies endpoint, traffic volume, request size, latency, geography, and header metadata as useful dimensions. Google Cloud Apigee’s Advanced Anomaly Detection similarly learns from error rates, traffic volume, request size, latency, geolocation, and other environment-level metadata.
How do you build a baseline that does not create false alarms?
Build separate distributions for each endpoint, model version, tenant or actor class, and normal workflow. A single global average hides the difference between an interactive chat endpoint, a low-volume embedding operation, and a nightly batch export.
Segment by the dimensions that change behavior
- Endpoint and operation: compare a generation route with other generation calls, not with authentication or health checks.
- Model and version: a new model can change token counts, latency, safety refusals, and normal endpoint mix.
- Actor and session: maintain profiles for API keys, authenticated principals, service accounts, sessions, and, where appropriate, account families.
- Workflow: label known batch clients, evaluation programs, interactive applications, and scheduled jobs separately.
- Environment and geography: distinguish production from staging and account for regional launches, shared NAT, and corporate proxies.
- Time: retain hourly, daily, and weekly patterns so seasonality and campaign peaks are not mistaken for attacks.
Use adaptive history, not a fixed magic number
Track distributions for request rate, inter-request gaps, endpoint mix, status codes, token ratios, latency, and semantic features. Apigee states that its anomaly model learns from historical traffic and accounts for seasonal variance when enough history exists. Cloudflare describes adaptive, per-session recommendations for individual operations. Your own baseline should likewise update slowly enough that a sudden attack does not become the new normal.

For a new endpoint with little history, use a conservative policy: require stronger identity, cap output, and alert on combinations of weak signals. Mark the baseline’s maturity in the alert so an analyst knows whether a threshold is based on months of data or only a few days.
What does model-extraction traffic look like?
Score combinations of signals rather than blocking on one threshold. The strongest indicators are sustained, correlated changes in volume, coverage, semantics, outcomes, and response collection.
Sustained volume or burstiness
Look for a high query rate, repeated bursts, unusually short inter-request gaps, or a long harvesting window from one actor, account family, ASN, or rotating IP set. A low average rate with regular, automated timing can be more suspicious than a single short spike because it may be designed to stay below a gateway limit.
Unusual endpoint or capability coverage
Compare the client’s observed endpoint mix with its declared use and historical profile. A tenant that normally calls one classification route but begins enumerating generation, embeddings, moderation, and diagnostic operations may be mapping the service. Coverage should be normalized for legitimate SDK upgrades and documented evaluation plans.

Low-diversity or deliberately systematic prompts
Measure repeated templates, near-duplicate prompts, controlled wording changes, and systematic input perturbations. Extraction workflows often vary one feature at a time to infer decision boundaries or capability limits. Low lexical diversity alone is not proof: translation services, testing harnesses, and customer-support macros can be equally repetitive.
Response harvesting and retry behavior
Flag unusually high output-to-input ratios, repeated requests for long completions, downloads or storage events tied to the same session, and retries that replay identical inputs after timeouts or errors. A client collecting model behavior may optimize for complete responses rather than interactive latency.

Error, latency, and control-plane anomalies
Elevated 4xx or 5xx responses, repeated schema failures, rate-limit events, and changing latency can indicate capability probing or concurrency pressure. Apigee documents anomaly categories including flooder, scraper, brute-guessor, OAuth-abuser, robot-abuser, and advanced anomaly rules. Cloudflare exposes detection fields for bot, attack, application-profile, leaked-credential, and AI-security analysis.
Semantic distribution shifts
A rolling window can move away from the benign distribution even when each prompt looks ordinary. Compare windows by tenant, endpoint, and actor class; an organization-wide product launch may shift everyone’s traffic, while a single account’s shift is more suspicious.
Quick wins for a faster PC:

Represent prompts with embeddings or redacted semantic features, then test whether a rolling window differs from that actor’s historical benign traffic. Liu, Guo, and Dong’s EMNLP 2026 paper evaluates this approach with maximum mean discrepancy (MMD), which compares distributions rather than requiring a known malicious phrase.
A practical windowing design
- Choose a window length that fits the endpoint’s normal cadence. Use a shorter window for high-volume APIs and a longer one for low-frequency enterprise workloads.
- Build a reference set from the same endpoint, model version, actor class, and environment. Exclude periods already labeled as incidents or unusual launches.
- Generate embeddings or redacted semantic features under an approved privacy policy. Store a feature identifier and retention expiry with each event.
- Compute the MMD distance and combine it with volume, endpoint coverage, response size, status codes, and timing features.
- Require persistence or corroboration before intervention. A single high distance may reflect a new customer use case; repeated distance plus systematic probing is stronger evidence.
In the reported evaluation, the detector produced a 0.3% benign false-positive rate, a 100.0% true-positive rate for pure-attacker traffic, a 90.5% average true-positive rate across attacker fractions, and 95.1% balanced accuracy. These are paper-specific test results, not a guarantee for your model, language mix, embedding model, or traffic distribution.
How do you implement the detection playbook?
Roll out detection in stages so that analysts can validate the signal before an automated control affects customers.
- Build the telemetry layer. Instrument the gateway, application, model-serving layer, identity system, and storage path with a shared request ID. Capture the fields in the telemetry table and synchronize clocks.
- Establish segmented baselines. Maintain endpoint-, model-, tenant-, actor-, session-, and workflow-specific distributions. Record seasonality, campaign periods, batch schedules, and baseline maturity.
- Calculate a multi-signal score. Combine volume or burstiness, endpoint coverage, prompt diversity, semantic distance, response harvesting, retries, errors, latency, geography, and network relationships. Keep feature values in the alert for explanation.
- Add semantic-window analysis. Start with redacted categories or embeddings, then tune window length and MMD thresholds on known benign evaluation and production periods.
- Enrich before acting. Attach customer authorization, account ownership, service-account purpose, IP reputation available within your organization, recent key changes, deployment events, and related sessions.
- Respond in stages. Observe and enrich first; then throttle, challenge, restrict output or endpoints, suspend temporarily, and escalate to human review according to confidence and business impact.
- Preserve evidence. Store correlated request, response metadata, identity, policy decisions, and control-plane events with immutable timestamps and retention labels.
- Review outcomes. Mark alerts as authorized evaluation, shared infrastructure, scheduled workload, product change, or suspected extraction. Feed confirmed false positives and incidents into the next baseline update.
Which response should follow a suspicious score?
Use graduated controls. A hard block on a weak signal can disrupt a legitimate customer, while unlimited observation gives an extractor more samples.

| Confidence and impact | Action | Guardrail |
|---|---|---|
| Low confidence | Increase logging, attach a request correlation ID, and alert an analyst. | Do not change customer behavior; verify scheduled jobs and shared networks. |
| Moderate confidence | Apply per-actor throttling, lower burst capacity, or require step-up authentication. | Use the API key, principal, or session identity rather than only the source IP. |
| High confidence | Restrict high-value endpoints, cap output length, disable expensive parameters, or require a verified workflow. | Preserve a customer-safe fallback and notify the account owner when appropriate. |
| Confirmed or severe abuse | Temporarily suspend the actor, revoke compromised credentials, and begin human incident response. | Document authorization checks, evidence, decision time, and an appeal or restoration path. |
OWASP recommends limiting model access frequency, preferably per actor such as a user, API key, or session, to slow experimentation used for model inversion, training-data extraction, and model exfiltration. It also notes that parallel access and multiple instances can bypass a simple limit. Apply coordinated quotas across keys, accounts, sessions, and related infrastructure when your identity model supports it, while avoiding blanket blocks on shared NAT.
Can rate limits stop someone from cloning a model?
Rate limits reduce the speed and economics of probing, but they do not guarantee prevention. An extractor can distribute calls across accounts, IP addresses, sessions, or model instances, and a low-frequency campaign may remain under a per-key threshold.
Make limits contextual: combine per-actor quotas with endpoint-specific burst controls, authentication strength, output minimization, schema validation, and anomaly-driven challenges. Track the aggregate account family and endpoint so a rotating address set cannot hide a coordinated campaign. Treat every limit as one layer in a defense-in-depth design, not as a detector by itself.
Independent reader supportYour contribution helps us test, update, and keep practical guides available for everyone. How should you investigate an alert without overclaiming theft?
Begin with authorization and operational context. Contact the customer or service owner through an established channel, check whether the traffic belongs to an evaluation program, and compare it with deployment, marketing, regional, or batch-schedule events.
Do these 3 things before closing this tab:
1Fix the driver behind crashes, sound loss and screen glitches2Repair Windows errors before they cause bigger problems3Scan for outdated or missing drivers - takes under a minuteInvestigation questions
- Does the API key map to the principal and product that generated the calls?
- Are the source addresses shared NAT, a corporate proxy, a cloud workload pool, or a consumer network?
- Did a scheduled job, SDK update, model migration, or product launch change endpoint mix or token volume?
- Do multiple keys, tenants, sessions, or ASNs share the same timing and semantic pattern?
- Are prompts near-duplicates, controlled perturbations, or part of an approved test corpus?
- Are responses unusually large, repeatedly retried, or transferred to a known customer-controlled destination?
- Did the actor encounter validation, rate-limit, safety, or authentication errors while exploring?
Preserve the evidence needed to reproduce the decision: request and response metadata, identity mappings, policy and rate-limit events, model version, semantic-feature version, and analyst notes. Do not retain raw prompts indefinitely merely because they are useful for detection; classify sensitive content, restrict access, and apply an explicit deletion schedule.
Should you use an API gateway, a custom detector, or both?
Gateway controls provide fast enforcement and established metadata, while a custom pipeline can model your product’s semantics and workflows. Many teams use a gateway for authentication, schema validation, quotas, and immediate actions, then stream normalized events to an internal detector for cross-account and semantic analysis.
Best Value
| Decision axis | Gateway security features | Custom telemetry-plus-semantic pipeline |
|---|---|---|
| Identity granularity | Strong when keys, principals, sessions, and tenants are propagated consistently. | Can join identities across applications, accounts, and control-plane systems, but requires engineering. |
| Scope | Excellent for endpoint and environment policy at the request boundary. | Can correlate endpoints, model versions, storage, and multiple environments. |
| Features | Usually emphasizes volume, errors, latency, headers, geography, and bot or attack metadata. | Adds prompt categories, embeddings, diversity, perturbation patterns, and response relationships. |
| Thresholds | Adaptive vendor models or configurable rules reduce initial tuning. | Fully tunable, but requires labeled data, validation, and ongoing calibration. |
| Actions | Alert, throttle, challenge, authenticate, or block close to the request path. | Can recommend actions and coordinate account-level response, but enforcement may be slower. |
| Privacy and retention | Depends on provider settings, processing location, and available retention controls. | You control feature generation and storage, but own access control, deletion, and compliance. |
| Explainability | Rule fields are easy to operationalize; proprietary scores may be harder to interpret. | Feature-level explanations are possible if the pipeline records them, at added complexity. |
| Latency and cost | Low inline latency but recurring service and event costs may apply. | Asynchronous analysis avoids request latency, but storage, embedding, compute, and operations add cost. |
NIST SP 800-228-upd1 is a useful standards reference when documenting these trade-offs. Recheck current feature names, preview status, pricing, processing regions, and retention terms for any product before deployment because those details change.
What are the most common detection mistakes?
- Blocking on one request: benign prompts are not evidence of extraction. Require aggregate context.
- Using one global threshold: endpoint, model, tenant, workflow, and seasonality differences make global averages noisy.
- Counting only source IPs: NAT and proxies merge customers, while distributed attacks split one actor across addresses.
- Ignoring low-and-slow behavior: a steady campaign can evade burst limits and still collect enough samples.
- Storing raw prompts by default: semantic monitoring can expose sensitive customer data. Prefer redaction, feature access controls, and short retention.
- Letting a new attack poison the baseline: quarantine incident periods and update models with review.
- Forgetting output controls: unrestricted completion length and repeated retries can make each query more valuable.
- Automating suspension without an owner: define who validates authorization, restores access, and communicates with the customer.
What should an operational checklist include?
Use this checklist when launching or reviewing an AI API:
- Every request has a stable correlation ID linked to identity, endpoint, model version, response metadata, and policy decisions.
- Baselines are segmented by actor or session, endpoint, model, environment, workflow, and time period.
- Alerts combine at least two behavioral dimensions, with feature values visible to analysts.
- Prompt or embedding collection has a documented purpose, access policy, retention period, and deletion process.
- Per-actor quotas exist at the user, API-key, or session level, with coordinated controls for related keys and instances.
- Output length, schema, authentication, and endpoint access are restricted according to business need.
- Known batch jobs, evaluations, launches, and shared networks are labeled before enforcement is enabled.
- Response actions progress from observation to throttling, challenge, restriction, suspension, and review.
- Evidence is preserved with synchronized timestamps so an alert can be reproduced.
- Metrics track false positives, missed incidents, time to analyst review, customer impact, and the number of samples an attacker can obtain before intervention.
Frequently Asked Questions
How much historical traffic is needed before anomaly detection is reliable?
There is no universal minimum because traffic diversity and seasonality differ by endpoint. Start with a short, explicitly labeled warm-up period for low-risk alerting, then expand the history across normal weekdays, weekends, launches, and batch cycles before enabling automatic blocking.
Should prompt embeddings be stored for every API request?
Not necessarily. Many deployments can begin with redacted categories, token and parameter statistics, and short-lived feature vectors; retain raw prompts only when a documented security or support need justifies the exposure. Encrypt the data, restrict analyst access, and attach deletion deadlines.
How do I distinguish an authorized model evaluation from extraction?
Require evaluation jobs to use registered principals, declared endpoints, expected time windows, and an approved corpus or workload label. Compare observed traffic with that declaration and pause enforcement when the identity or schedule does not match, rather than relying on content alone.
What is a useful success metric for an extraction-detection program?
Measure how quickly the system identifies and slows suspicious sampling while preserving authorized traffic. Track false-positive rate by tenant, analyst confirmation time, samples served before intervention, and recovery time after a mistaken challenge.
