The fastest LLM serving configuration is workload-specific: set both a maximum number of concurrent sequences and a maximum total number of batched tokens, then benchmark those limits with your real prompt lengths, output lengths and concurrency. Quantization can free weight or KV-cache memory and sometimes reduce latency, but gains depend on the accelerator, kernels, serving engine and the quality loss your application can tolerate. There is no universally optimal batch size or quantization format.
Start by defining your latency target, throughput target, context lengths and available GPU memory. Tune one constraint at a time, verify that the selected implementation is supported by your exact engine and GPU, and compare throughput, time to first token, end-to-end latency, memory use and output quality under identical conditions.

What should you decide before changing batch size or quantization?
Write down the serving conditions first. A setting that wins on offline throughput can fail when users send long prompts, when several requests arrive together, or when first-token latency is tightly limited.
- Engine and release: record the serving engine and version because option names, kernels and quantization support change over time.
- Model and precision: note the model revision, baseline precision and whether you intend to quantize weights, the KV cache, or both.
- Accelerator: record GPU model, memory capacity, architecture and the number of GPUs. Hardware support is format-specific.
- Request shape: measure typical and worst-case input tokens, generated output tokens, beam width if used, and simultaneous requests.
- Objective: define whether you are optimizing aggregate tokens per second, time to first token, inter-token latency, end-to-end latency, maximum context, or cost per request.
Keep these values with every benchmark result. Without them, a speed number cannot be compared fairly with another configuration.

How do maximum sequences and maximum batched tokens control vLLM batching?
In vLLM-based endpoints, two limits shape a batch: the maximum number of sequences and the maximum total number of tokens in the batch. The sequence limit controls request count; the token limit caps the sum of tokens across those requests. Both limits must fit available memory, including space needed for the KV cache and long contexts. The endpoint documentation describes these controls and their deployment trade-offs at Hugging Face’s vLLM engine configuration guide.
Maximum number of sequences
A higher sequence limit lets the scheduler admit more requests at once. That can improve utilization when requests are short, but it also allows more KV-cache allocations and can increase queuing or memory pressure when requests are long. A low limit may protect latency and memory while leaving accelerator capacity unused during bursts.
Do these 3 things before closing this tab:
1Repair Windows errors before they cause bigger problems2Fix the driver behind crashes, sound loss and screen glitches3Clear out junk files and repair common Windows errorsMaximum batched tokens
The token limit is the guardrail for mixed-length traffic. For example, many short prompts can fit under the same request-count limit as a few long prompts, but their summed token count is very different. Raising this limit may increase throughput until memory bandwidth, KV-cache capacity or kernel efficiency becomes the bottleneck.
Why both limits matter
Neither setting alone describes the real batch. A batch of 16 requests with 2,000 tokens each is a different workload from 16 requests with 200 tokens each. Set both limits, then observe which one is reached first in production-like traffic.
| Control | What it limits | When it becomes the bottleneck | Typical risk when raised |
|---|---|---|---|
| Maximum sequences | Concurrent requests admitted to a batch | High request concurrency with short or moderate prompts | More KV-cache allocations, queueing and tail latency |
| Maximum batched tokens | Combined tokens across active requests | Long prompts, long generations or mixed request lengths | Out-of-memory errors, lower latency predictability and reduced room for context |
How do you choose initial sequence and token limits?
Choose conservative starting values that fit the longest request you must serve, then increase one limit while monitoring memory and latency. Documentation does not prescribe a universal number because model size, context length, GPU memory and request mix differ.

- Measure the workload: collect a representative distribution of input tokens, output tokens and concurrent requests. Include a worst-case context if your API accepts one.
- Set a safe sequence ceiling: begin below the maximum concurrency you expect, leaving memory headroom for the KV cache and runtime overhead.
- Set a token ceiling: choose a total-token budget that accommodates normal batches without allowing an extreme combination of long prompts and long generations.
- Warm the service: send enough requests to reach steady state before recording results. Cold startup and compilation can distort latency.
- Change one constraint: raise either the sequence limit or token limit while holding the other constant. Record throughput, first-token latency, inter-token latency, end-to-end latency and peak memory.
- Stop at the knee: when throughput stops improving but latency or memory rises sharply, keep the lower setting. Test a smaller value if tail latency violates your service objective.
Use the endpoint’s documented names for the deployed release, commonly represented by maximum-sequence and maximum-batched-token settings. Configuration syntax can vary by platform, so verify the active values in startup logs or the engine’s runtime configuration rather than assuming a value was accepted.
How do data parallelism and tensor parallelism change batch tuning?
Adding data-parallel copies can increase request capacity because each copy serves its own queue, but each copy has less KV-cache memory available for its assigned traffic. Tensor parallelism splits model weights across GPUs and can make a larger model fit, while introducing synchronization between devices. The best choice depends on model size, interconnect, context length and concurrency; it is not a universal batch-size recommendation.
When data parallelism helps
Data parallelism is useful when the model fits on each replica and your workload has enough independent requests to keep replicas busy. Re-check per-replica KV-cache headroom: multiplying copies does not give one request a larger context budget.
When tensor parallelism helps
Tensor parallelism is primarily a capacity and compute strategy for models that need multiple GPUs or benefit from distributed matrix operations. Synchronization can reduce scaling efficiency, especially for small batches, so benchmark the same request shape with and without additional partitions.
Which quantization approach should you use?
Quantization is a family of formats and implementations, not a single performance switch. vLLM lists multiple weight and KV-cache paths and maintains a hardware support matrix at its quantization documentation. That matrix can change, so check the page for the exact deployed release and accelerator before selecting a format.

Weight quantization
Weight quantization stores model weights with fewer bits than the baseline representation. Its main benefit is lower weight memory, which can leave more room for KV cache or allow a model to fit on fewer GPUs. Actual speed depends on whether the engine has an optimized kernel for that format; a smaller representation can be slower if it triggers dequantization overhead or an unsupported fallback.
KV-cache quantization
KV-cache quantization targets the activations retained for attention during generation. It can increase the number of tokens or concurrent sequences that fit in memory. Google Cloud documents FP8 E5M2 KV-cache quantization as a way to significantly reduce KV-cache memory and improve latency, especially at large batch sizes, while warning that inference accuracy decreases; see the Google Cloud GPU inference guide. Treat that statement as guidance for the described environment, and test quality on your own prompts.
Quantizing both weights and KV cache
Combining methods may produce a larger memory reduction, but it also combines their compatibility and quality risks. Isolate the effects in benchmarks: baseline precision, weight-only quantization, KV-cache quantization, and the combined configuration should be measured separately when practical.
How do you verify hardware and engine support?
Before benchmarking, confirm that the selected format is implemented for your GPU architecture and serving engine. A format listed in general documentation may still be unavailable for a particular release, model architecture or kernel path.

- Confirm that the model’s layers and attention implementation are supported; otherwise the engine may reject the model or use a slower fallback.
- Record whether the runtime is using the intended quantized kernels. Startup logs and profiling traces are more reliable than a configuration file alone.
- For managed endpoints, verify that the platform exposes the sequence and token limits you intend to tune; provider defaults may override local assumptions.
Do not treat buying a newer accelerator as a guarantee of faster inference. Memory capacity, architecture-specific kernels, interconnect bandwidth and engine support all influence the result. A GPU is a prerequisite for some optimized paths, but the complete software and hardware combination determines performance.

How should you benchmark batch size and quantization?
Use the same model, prompt lengths, output lengths, concurrency, warmup policy and latency definition for every candidate. The vLLM throughput benchmark interface exposes controls for input length, output length, prompt count, warmups and quantization; option names can vary by release, so consult the command help installed with your version.
A repeatable benchmark sequence
- Establish a baseline: run the unquantized or current production precision with a conservative batch configuration.
- Test request shape: include at least one short-prompt/short-output case, one typical case and one long-context case. Add the concurrency levels your service expects.
- Warm up: discard startup and first-run compilation effects. Use the same warmup count for every candidate.
- Sweep limits: test several sequence ceilings and token ceilings, changing one at a time before testing combined changes.
- Sweep quantization: compare only formats supported by the target engine and GPU. Keep batch limits fixed while isolating quantization effects.
- Measure quality separately: run task-specific accuracy, safety and regression checks on identical prompts. Tokens per second alone cannot reveal unacceptable output changes.
- Repeat: run enough iterations to capture variability and report medians plus tail latency such as p95 or p99.
Metrics to capture
| Metric | Why it matters | How to compare |
|---|---|---|
| Throughput | Shows aggregate serving capacity | Compare generated tokens per second at the same concurrency and request shape |
| Time to first token | Controls perceived responsiveness | Use the same prompt length and latency constraint for every run |
| Inter-token latency | Describes streaming smoothness | Measure during generation, not only at request completion |
| End-to-end latency | Captures queueing, prefill and decode | Report the distribution, including tail values |
| Peak memory and KV-cache occupancy | Determines safe context and concurrency | Record during the longest representative batch |
| Output quality | Detects quantization regressions | Use task-specific evaluation under the same decoding settings |
Keep benchmark claims in scope
NVIDIA’s published TensorRT-LLM example reports a 2.3× FP8 speedup over FP16 for LLaMA-v2-7B at batch size 16, with first-token latency below 500 ms. Its table specifies 1,024 input tokens, 128 output tokens, tensor parallelism of 1 and an H100 80GB GPU. The result is conditional on that model, hardware, sequence shape and latency target; it is not a general speedup promise. The same table reports, at batch size 1 and under those conditions, GPT-J speedups of 1.40× for FP8 and 1.40× for INT8 smooth quantization versus FP16, and LLaMA-v2-7B speedups of 1.51× and 1.47× respectively. See the full NVIDIA quantization benchmark for the stated setup.

A TensorRT-LLM engine is compiled for a target GPU architecture and declared maximum batch, input length, output length and beam width. The TensorRT-LLM backend documentation explains these build-time constraints. If production traffic exceeds a compiled limit, you may need a new engine rather than a runtime-only setting change.

Plan engine profiles around real traffic
Choose maximum lengths and batch capacity from measured service requirements, not an average request alone. Oversized compile limits can consume memory even when typical traffic is small; undersized limits can reject legitimate requests or force another deployment profile.
Rebuild after material changes
Changing GPU architecture, maximum context, output limit, beam width or batch target should trigger a review of engine compilation settings. Keep the build configuration beside benchmark results so a later deployment can reproduce the same constraints.

How do you troubleshoot an out-of-memory error or slower-than-expected result?
Out of memory during startup or batching
- Lower the maximum batched-token limit first if long prompts or generations are common.
- Lower the sequence limit if many requests are admitted simultaneously.
- Check KV-cache occupancy and leave headroom for runtime allocations.
- Use a supported weight or KV-cache quantization path, then rerun quality tests.
- For multi-GPU deployments, verify whether data-parallel replicas reduced per-copy KV-cache memory or tensor-parallel synchronization is limiting efficiency.
Throughput does not improve when the batch grows
- Check whether the token limit, not the sequence limit, is already binding.
- Look for kernel fallbacks caused by an unsupported quantization format or GPU combination.
- Separate prefill-heavy and decode-heavy workloads; a setting that helps one phase may hurt the other.
- Confirm that requests are actually concurrent during the test and that warmup and prompt counts are equivalent.
Latency becomes unacceptable
- Reduce admission limits until first-token and tail latency return to target.
- Cap long contexts or route them to a profile with more KV-cache capacity.
- Compare data parallelism and tensor parallelism at the same concurrency; synchronization and queueing can change the result.
- Do not keep a quantized format solely for throughput if its quality regression fails the application evaluation.
What is a practical production rollout plan?
Use a staged rollout rather than replacing the baseline after one benchmark run.
- Deploy the baseline precision and conservative limits as a reference.
- Run offline quality tests for every quantization candidate.
- Replay representative traffic at increasing concurrency while collecting memory and latency telemetry.
- Canary the best candidate on a small share of requests and compare error rate, quality signals and tail latency.
- Promote only a configuration that meets both quality and service-level objectives.
- Revisit limits after a model revision, engine upgrade, GPU change or shift in prompt-length distribution.
Keep a configuration record containing model revision, engine version, GPU type, quantization mode, sequence limit, token limit, context limits, benchmark command, warmup policy and measured results. This prevents a future comparison from mixing incompatible conditions.

Frequently Asked Questions
Can I increase batch size without changing the model?
Yes. Sequence and token admission limits are serving settings, so they can usually be changed without retraining. You still need to verify that the new limits fit memory and that the resulting queueing and tail latency meet your service objective.
Should I quantize weights or the KV cache first?
Start with the memory bottleneck you have measured. Weight quantization primarily frees space occupied by model parameters, while KV-cache quantization targets memory that grows with active context and concurrency; test each in isolation before combining them.
How do I know whether a quantized run is using an optimized kernel?
Check startup messages, runtime diagnostics and profiler traces for the selected implementation, then compare against the baseline at identical request shapes. A configuration that loads successfully can still fall back to a slower path if the GPU or model architecture is not supported.
When should I repeat the benchmark?
Repeat it after changing the model revision, serving-engine release, GPU architecture, maximum context or quantization implementation. Re-run sooner if production prompt lengths or concurrency change materially, because those shifts alter which batch limit is binding.
