An AI evaluation suite for production workloads is a versioned system of test data, evaluators, release gates, and live monitoring. Build it by defining business and risk objectives first, then testing representative cases across the whole architecture—retrieval, prompts, tools, routing, guardrails, and final responses. Combine executable checks for machine-verifiable behavior, rubric-based model judges for nuanced quality, and calibrated human review for high-impact or ambiguous cases. Run the suite offline for every material change and sample production traces asynchronously so regressions are detected without adding user-facing latency.
There is no universal quality score or threshold. A useful suite ties each metric and threshold to a specific product requirement, records enough provenance to reproduce every run, and keeps held-out cases that the system never sees during tuning.

Start with the outcome the product must deliver, not with a favorite benchmark or judge model. OpenAI’s evaluation guidance recommends defining the evaluation objective before collecting data or selecting metrics. Rewrite each requirement as an observable pass/fail condition or a scored criterion, then document which failures are severe enough to block release.
Turn product promises into testable criteria
- Factual correctness: the answer contains accurate claims for the task and does not invent details.
- Groundedness: claims are supported by the approved context, records, or tools available to the system.
- Instruction following: the response obeys system and user constraints, including output format and scope.
- Refusal behavior: unsafe, disallowed, or unauthorized requests are declined in the required manner.
- Tool-call correctness: the system chooses the right tool, supplies valid arguments, and handles the result correctly.
- Operational quality: latency, token usage, and cost remain within the product’s limits.
Define severity levels before scoring examples. A wrong answer in a low-impact brainstorming feature may be recoverable; an incorrect eligibility decision, privacy disclosure, or financial instruction may be deployment-blocking. For each severity, record the pass threshold, the owner who approves exceptions, and whether one critical failure overrides an otherwise strong aggregate score.

Separate quality failures from system failures
A final answer can look plausible even when an upstream component failed. Classify failures by location as well as symptom: retrieval returned the wrong passages, a router selected the wrong workflow, a tool received malformed arguments, a guardrail missed a prohibited request, or the final response misstated a correct tool result. This taxonomy lets a trace-level evaluator identify the repair point instead of treating every defect as a generic hallucination.
How do you assemble and version a production-grade evaluation dataset?
Use several data sources because no single source represents production risk. Combine expert-authored cases, historical or sampled production traces, user feedback, synthetic edge cases, and adversarial cases. Keep a held-out regression split that is not used for prompt tuning or judge calibration.
Build the case mix
- Expert cases: domain specialists write canonical tasks, acceptable answers, prohibited claims, and grading notes.
- Historical and sampled traces: capture real intent, language, workflow paths, and failure modes. Remove or protect sensitive data according to your privacy policy before reuse.
- User feedback: attach ratings, corrections, escalation outcomes, and the user’s timestamp so feedback can be traced to the exact interaction.
- Synthetic edge cases: generate rare combinations, boundary values, missing fields, long contexts, and unusual but valid requests, then review them for realism.
- Adversarial cases: probe prompt injection, policy evasion, conflicting instructions, tool misuse, data exfiltration, and malformed inputs.
Stratify the dataset so aggregate scores do not hide a weak segment. Useful strata include user intent, language, geography, customer tier, workflow path, model or prompt variant, and risk level. Preserve the stratum label with every case and report results by stratum as well as overall.
Store labels and references, not just prompts
Each case should carry the expected answer or an acceptable-answer set when a single wording is not required. For retrieval-augmented generation, store the relevant documents, passages, or reference identifiers. For structured tasks, store a machine-readable expected schema or executable assertion. Include policy labels, severity, allowed tools, and any conditions that change the correct response.
Version the dataset whenever a case, label, reference, or split changes. Keep training or tuning data separate from the held-out regression set. MLflow describes evaluation datasets as a centralized test database and supports attaching feedback to traces with user and timestamp metadata; that separation makes it possible to distinguish a newly discovered production issue from a change in labeling.
Protect representativeness and privacy
Track how cases were sampled and what traffic they represent. A convenient batch of highly rated conversations is not a neutral production sample. Record language and geography explicitly, redact or tokenize personal data, and restrict access to sensitive traces. If a production trace is transformed into a test case, preserve a link to its source identifier in protected metadata rather than copying unnecessary customer content.

Which evaluators should an AI evaluation suite use?
A layered evaluator stack is more dependable than one all-purpose score. Use deterministic checks where the answer is machine-verifiable, rubric-based LLM judges for nuanced quality, and blinded human review for high-impact or ambiguous cases. Calibrate automated judges against human labels before using them as release gates.
Deterministic and executable checks
Code-based checks are the first choice for schema validity, required fields, function-call arguments, SQL execution, numeric tolerances, policy flags, and exact routing outcomes. They are fast, repeatable, and easy to run in continuous integration. Keep assertions narrowly tied to the requirement; an exact string comparison is inappropriate when several phrasings are correct.

Rubric-based LLM judges
Use a written rubric that defines what earns a pass, what constitutes a minor defect, and what is a critical failure. Ask for a constrained output such as pass/fail or a pairwise preference when possible. OpenAI notes that pairwise comparison and pass/fail formats can be more reliable than unconstrained numerical scoring, but judge outputs still need agreement checks against human labels.
Measure judge reliability on a blinded calibration set. Review disagreement by language, topic, risk level, and answer length; a judge can appear accurate overall while systematically favoring verbose responses or missing a particular safety failure. Version the judge model, prompt, rubric, and parsing code so a score change can be attributed to an evaluator change rather than to the system under test.
Human review for consequential and ambiguous cases
Use trained reviewers when an error could materially affect a person, when policy interpretation is disputed, or when the automated judge is uncertain. Blind reviewers to the model or prompt variant where practical, provide the rubric and reference material, and adjudicate disagreements. Human labels are also the calibration standard for measuring judge bias and drift.
| Evaluator type | Best use | Important control |
|---|---|---|
| Deterministic or executable check | Schemas, function arguments, SQL results, policy flags, exact workflow conditions | Assert the requirement without overconstraining acceptable wording |
| Rubric-based LLM judge | Relevance, completeness, style, groundedness, and pairwise quality comparisons | Calibrate against blinded human labels and version the rubric and judge |
| Human review | High-impact decisions, ambiguous cases, and judge calibration | Use trained, blinded reviewers and an adjudication process |
How do you evaluate every boundary in an AI architecture?
Test both components and end-to-end outcomes. A final-response score alone cannot show whether a regression came from retrieval, routing, a tool, a handoff, or the response generator.
Single-turn calls
Check instruction following, functional correctness, factuality, refusal behavior, and output formatting. Include cases with conflicting or incomplete instructions to verify that the system applies the intended priority rules rather than simply matching familiar wording.
Retrieval-augmented generation
Evaluate retrieval before judging the generated answer. Measure whether relevant context was retrieved, whether irrelevant material crowded it out, and whether the final claims are grounded in the supplied passages. Store the reference passages with each case so a reviewer can distinguish a retrieval miss from a generation error.
Tools and structured actions
Inspect tool selection, argument names and types, authorization, error handling, retries, and the interpretation of returned data. Execute calls in a safe test environment where possible. A response that describes the correct action but emits an invalid function call should fail the tool-call criterion even if its prose sounds convincing.
Routing, handoffs, and guardrails
Trace which route or specialist handled the request, whether context and permissions survived a handoff, and whether guardrails ran at the required points. Include escalation and termination cases: an agent should stop when it has completed the task or when a human must take over, rather than retrying indefinitely.

End-to-end outcomes
Evaluate the user-visible result, not only intermediate scores. A workflow can have strong retrieval precision and valid tool calls yet still fail to complete the requested task. Keep component-level evidence in the same trace so a failing end-to-end case can be localized.
Which metrics belong in a production evaluation portfolio?
Do not reduce quality to one generic score. Select a portfolio whose metrics map directly to the objectives and risks you defined, and set thresholds per product rather than importing a universal target. The reviewed guidance offers methodological recommendations, not a stable industry benchmark.

Microsoft groups evaluation methods into reference-based, reference-free, LLM-based, code, and RAG metrics. That classification is useful when selecting complementary measurements: reference-based checks need reliable answers or passages, while reference-free methods are useful when many valid answers exist but still require calibration.
What is the difference between offline evals and online evaluation?
Offline evaluation runs a curated dataset or historical traces before release; online evaluation inspects sampled live traces after deployment. You need both: offline gates provide repeatable comparisons, while online monitoring reveals traffic, languages, workflows, and failure combinations that the curated set missed.
Run offline gates on every material change
- Freeze the dataset version, split, evaluator versions, and baseline run.
- Run the suite against every material prompt, model, retrieval, tool, routing, guardrail, or application-code change.
- Compute overall and stratum-level metrics, then compare them with the baseline.
- Apply severity-aware release thresholds. A critical safety or authorization failure can block deployment even when aggregate quality improves.
- Review representative failures and judge-human disagreements before approving an exception.
Keep the regression set held out from tuning. When a production incident produces a new case, add it to a versioned development split first; after the fix is validated, move an appropriately transformed copy into the held-out set so the failure remains a future regression test.
Monitor live traces without blocking requests
Sample production traces for automatic evaluation and prioritize high-risk, high-value, newly changed, or user-escalated traffic. Run quality checks asynchronously so a judge or human queue does not add latency to the user request. Route failed or uncertain cases to human review, and retain the trace, evaluator output, and escalation decision for later analysis.
Recommended Free Tools
MLflow distinguishes offline evaluation on datasets or historical traces from automatic evaluation on live traces and conversations. Use that distinction operationally: offline results determine whether a release is eligible, while online signals determine whether the release should be investigated, rolled back, or allowed to continue under observation.
Control sampling cost and blind spots
Document the sampling rate, selection rules, and escalation thresholds. Uniform random sampling estimates broad quality, while risk-based sampling increases coverage of safety-sensitive or expensive workflows. Use both when possible, and report the denominator so a high pass rate from a tiny or biased sample is not mistaken for proof of reliability.

How should evaluation results be reported and governed?
Every run should be reproducible by someone who did not execute it. NIST AI 800-2 structures automated benchmark work around protocol design, implementation, execution, debugging, analysis, and reporting; the same discipline is useful for production suites.
Record complete provenance
- Evaluation objective and failure taxonomy
- Dataset name, version, split, strata, and sample size
- Prompt, application-code, retrieval-index, tool, and model versions
- Evaluator model, code, rubric, and parser versions

- Aggregate and stratum-level results, confidence or uncertainty information, and baseline comparison
- Representative passing and failing examples, including trace identifiers and reviewer decisions
Store artifacts immutably enough to reproduce a historical release decision. If data must expire for privacy reasons, retain the metadata and a sanitized failure representation that still supports debugging.

Review changes to test cases, labels, rubrics, evaluator prompts, and thresholds just as you review application code. Require an owner and rationale for changes that remove a case, weaken a threshold, or alter sampling. Keep release-gate results attached to the deployment record so later incidents can be compared with the exact evidence available at launch.
Use uncertainty and failures, not only averages
Report sample size and uncertainty alongside pass rates. A small improvement may be noise, while a single severe failure may be decisive. Include failure clusters by intent, geography, language, customer tier, and workflow step; these slices often reveal regressions hidden by a strong overall average.
How can you implement the suite as a repeatable operating process?
Build the system in an order that reduces rework and keeps each decision traceable.
- Write the objective and taxonomy: list the user outcome, measurable criteria, severity levels, owners, and release-blocking conditions.
- Create the initial dataset: combine expert, production, feedback, synthetic, and adversarial cases; attach references, expected outputs, permissions, and labels.
- Define splits and strata: reserve held-out regression data and document how each segment is represented.
- Implement executable checks: validate schemas, tool arguments, policy flags, workflow state, and other machine-verifiable requirements.
- Add calibrated judges: write rubrics, prefer pass/fail or pairwise formats where suitable, and measure agreement with blinded human labels.
- Instrument traces: capture retrieval, routing, handoffs, guardrails, retries, tools, latency, tokens, cost, and final output in one traceable record.
- Connect CI or deployment gates: run the fixed suite on every material change, compare with a baseline, and block on defined critical failures or threshold breaches.
- Start asynchronous online monitoring: sample live traces, prioritize risk, escalate failures, and feed confirmed incidents back into the dataset lifecycle.
- Review and govern: publish run artifacts, inspect representative failures, adjudicate judge disagreements, and approve changes to data, rubrics, or thresholds.
This process turns evaluation from a one-time benchmark into an operational control. The suite should evolve when the product, traffic, policies, tools, or risk profile changes, while its version history preserves which evidence supported each release.

A single score hides a dangerous segment
Symptom: the overall pass rate rises while one language, geography, workflow, or risk class degrades. Fix: stratify reporting, set segment-specific minimums where the risk warrants it, and sample that segment deliberately in online monitoring.
The judge rewards fluent but unsupported answers
Symptom: automated scores are high although reviewers find fabricated or ungrounded claims. Fix: add reference and groundedness checks, show retrieved evidence to the judge, and recalibrate against blinded human labels.
Best Value
End-to-end failures cannot be localized
Symptom: a bad final answer is recorded without retrieval, routing, tool, or guardrail evidence. Fix: evaluate each architecture boundary and preserve a trace-level record of intermediate decisions and outputs.
The regression set is contaminated
Symptom: tuning scores improve but production regressions recur. Fix: protect held-out cases, restrict access, and add incident-derived cases only after the fix has been validated outside the held-out split.
Online monitoring is too expensive or too slow
Symptom: every live request is sent through costly judges or synchronous review. Fix: evaluate asynchronously, sample according to documented risk and coverage goals, and send uncertain or severe failures to humans instead of evaluating everything identically.
What does a mature evaluation suite look like?
A mature suite can answer five questions for any release: what the system was supposed to do, which cases represented that requirement, how each case was judged, whether every important architecture boundary behaved correctly, and what happened after deployment. It provides repeatable offline evidence without pretending that a benchmark predicts every live interaction. It also creates a feedback loop in which confirmed production failures become versioned, held-out tests rather than disappearing into an incident queue.
The strongest implementation is therefore not the one with the most metrics. It is the one whose objectives, data, evaluators, thresholds, traces, and review decisions are explicit enough that another team can reproduce the result, understand a failure, and make a safer release decision.
Frequently Asked Questions
How large should an AI evaluation dataset be?
There is no universal case count. Size it to cover the product’s intent, language, geography, workflow, customer, and risk strata, then use sample-size and uncertainty reporting to show how much confidence each result deserves. Rare but severe scenarios need deliberate inclusion even when they are uncommon in traffic.
Can an LLM judge replace human evaluators?
No. A judge can scale routine checks, but human review remains necessary for consequential or ambiguous decisions and for detecting judge bias. Use blinded human labels to calibrate the judge and route low-confidence or high-severity cases to people.
How do I evaluate an agent that takes several actions?
Evaluate the complete trace, not only the final message. Check route selection, handoffs, tool choice and arguments, permissions, retries, guardrails, termination, and the resulting user outcome; this shows which step caused a failure.
How often should production traces be evaluated?
Run asynchronous sampling continuously or on a schedule appropriate to traffic and risk, and increase coverage after a material change, incident, or drift signal. Document the sampling policy and denominator so trends remain interpretable.
What should happen when offline and online results disagree?
First compare traffic mix, strata, evaluator versions, and sampling rules; disagreement often reflects coverage differences rather than a mathematical contradiction. Investigate representative traces, then add confirmed online failures to the versioned dataset and adjust the offline suite if it missed a meaningful production condition.
