Autoregressive LLMs write by predicting tokens one at a time from left to right; diffusion LLMs start with an incomplete or noisy representation and refine multiple positions over repeated steps. That difference can make diffusion a natural fit for filling gaps or revising text, but it does not automatically make it faster or better. The practical result depends on the model, task, decoding method, hardware and serving setup.
A useful shorthand is “write in sequence” versus “refine a draft.” It is only an analogy: both approaches perform token-level computation, and “diffusion” covers several designs rather than one standard way to generate language.

An autoregressive model generates a sequence by repeatedly predicting the next token. It takes the prompt and any tokens it has already generated as context, predicts what should come next, then adds that token to the context for the following prediction. This creates a dependency chain: the model must produce earlier output before it can condition later output on it.
For example, after a prompt leads the model to produce “The,” the next prediction can use “The” as context; the prediction after that can use “The answer,” and so on. The model is not necessarily generating one whole word at a time: a token may correspond to a word, part of a word, punctuation or another unit. The important feature is the sequential order of predictions, not the number of words.

That left-to-right process is what people commonly mean when they describe conventional next-token decoding. It gives the model a growing prefix to condition on, but the next output position depends on the preceding generated positions. The survey and Google’s DiffusionGemma explanation use this sequential next-token process as the contrast with diffusion generation.
How does a diffusion LLM generate text?
A diffusion language model begins with a noisy, masked or otherwise incomplete representation of the text it is trying to produce. It then runs repeated refinement steps that progressively reconstruct or change the sequence. In many approaches, multiple positions can be updated in the same step, and the model can use context from both sides of a position rather than only the already-written prefix.
Think of the distinction as producing a sentence one token at a time versus revisiting an incomplete sentence several times. The analogy helps explain the workflow, but it should not be taken literally: implementations differ in their representation, noise process, update rules and decoding schedule.
Some approaches diffuse directly over discrete tokens; others work in a continuous representation and map the result back to text. Those are different technical choices under the same broad label. It is therefore inaccurate to assume that every diffusion LLM begins from the same kind of blank canvas, uses the same corruption process or refines text in the same number of steps.
What does “refinement” mean?
In this context, refinement means that generation is spread across repeated model evaluations instead of being limited to a single left-to-right chain of next-token predictions. A step can fill in or alter positions in an incomplete sequence. A later step can use the current state of the wider sequence to refine the result further.
This offers a different way to organize generation, not a guarantee of a better sentence. Output quality still depends on the particular model and the task, and repeated evaluations may add inference work. The relevant contrast is the structure of the generation process, not a promise that one approach will always use less computation.

What are the practical differences between the two approaches?
The main trade-off is sequential decoding versus iterative refinement. That difference affects how systems can generate, fill and revise text, but other practical properties—including latency, throughput and text-length handling—depend on the specific model and serving method.
| Question | Autoregressive generation | Diffusion generation |
|---|---|---|
| How does generation proceed? | Predicts tokens sequentially, using prior generated tokens as context. | Refines a noisy, masked or incomplete sequence over repeated steps. |
| Can positions be updated in parallel? | Later tokens depend on earlier output, so generation has a sequential dependency. | Many approaches can update multiple positions in a step; the details vary by design. |
| Can the model revise or fill text? | Conventional next-token generation extends the prefix. Other editing behavior depends on the system. | Sequence refinement provides a natural mechanism for infilling and revision, but capability is implementation-dependent. |
| What determines speed? | Sequential decoding depth, as well as the model and serving setup. | Number of refinement steps, as well as the model and serving setup. |
| Are there universal quality or speed winners? | Not established by the evidence summarized here. | Not established by the evidence summarized here. |
The table describes broad tendencies, not fixed product specifications. For a real comparison, a speed or quality claim needs to identify the models, task, compute, decoding conditions and hardware being compared. Without that context, “diffusion is faster” or “autoregressive is better” overstates what the architecture label can establish.
Are diffusion LLMs faster than autoregressive LLMs?
Not universally. Diffusion models may update several positions in one refinement step, but they often need repeated model evaluations to produce a result. Autoregressive models have a sequential dependency between output tokens. Which process finishes sooner depends on how many evaluations each method uses and on the specific model, decoding method, hardware and serving conditions.
There is no general-purpose, matched speed statistic in the evidence summarized here that establishes an architecture-wide winner. A meaningful latency comparison should use the same task and comparable compute, and report the conditions under which the result was measured. Per-request latency and throughput under batching are also distinct questions: a system that performs well in one setting need not lead in the other.
Why do diffusion methods use multiple steps?
Iterative refinement is the generation mechanism: the model updates an incomplete sequence repeatedly. Standard discrete diffusion can require hundreds or thousands of model evaluations for high-quality results, according to Apple’s FS-DFM page, which presents that range as motivation for its few-step flow-matching approach. That description is specific to the research motivation and method; it is not a matched speed comparison against autoregressive models or a count that applies to every diffusion system.
Researchers are working to reduce the number of steps. Fewer-step approaches aim to make iterative generation more practical, but the number of evaluations alone does not settle whether a complete system is faster: model cost per evaluation and deployment conditions matter too.

Why might diffusion help with infilling or editing?
Because diffusion approaches refine a sequence rather than only extending a prefix, they can be designed to fill gaps or revise positions using surrounding context. That makes infilling and controlled editing natural areas to explore. It does not mean every diffusion model offers a user-facing editing feature, or that autoregressive systems cannot support editing through other methods.
The research examples illustrate different levels of this possibility. The ICLR 2025 DiffuLLaMA paper reports adapting autoregressive models into diffusion models, with converted model sizes from 127 million to 7 billion parameters. Its authors describe evaluated language-modeling, reasoning and commonsense performance, along with in-context learning, infilling and instruction-following capabilities. These are claims about that paper’s systems and evaluations—not evidence that diffusion models generally outperform autoregressive models on those tasks.
An ICLR 2026 paper, “On Powerful Ways to Generate,” examines theoretical properties of masked diffusion and proposes an any-process approach that can remask, insert and delete tokens. It is an example of ongoing work on more adaptive editing behavior, not evidence that those operations are standard in deployed products.
How do these models handle text length and caching?
Text length and inference efficiency are not settled properties of every diffusion model. Some approaches face a fixed-length generation setup or lack the key-value (KV) caching used in other decoding designs, but those limitations should not be generalized to all diffusion systems.
The ICML 2026 Set Diffusion paper identifies fixed-length generation and lack of KV caching as common issues in prior diffusion approaches, then proposes flexible-position and flexible-length decoding. This is evidence that researchers are actively addressing how sequences grow and how inference state is reused. It does not establish that every diffusion model has those limitations, or that the proposed approach has become a standard product feature.
Google’s DiffusionGemma documentation gives a concrete hybrid example. In Google’s own account of its design, the model iteratively refines a token canvas and uses sequential blocks to extend generation beyond the canvas length. This combines refinement within blocks with sequential extension between them. Its canvas and implementation are specific to that design; they should not be treated as universal diffusion-model specifications.

Are autoregressive and diffusion generation mutually exclusive?
No. Hybrid approaches combine parts of both strategies, which makes the boundary more flexible than a simple either-or classification suggests. Google’s DiffusionGemma explanation is one example: its account describes iterative refinement within a token canvas and sequential blocks for generation beyond that canvas.
Hybridization matters because the design question is not only “Which architecture wins?” A model can use refinement where changing multiple positions is useful and sequential generation where extending the output is appropriate. The resulting system still needs to be assessed on its actual task and serving behavior; a hybrid label does not settle speed or quality either.
What does research show about quality and reasoning?
There is no architecture-wide quality or reasoning winner established by the evidence here. Individual research results are tied to a particular model, training setup, task and evaluation; they should be read in that context rather than turned into a general ranking.
The NeurIPS 2025 paper “Diffusion Beats Autoregressive in Data-Constrained Settings” reports that masked diffusion models outperform autoregressive models in a specific setting where training data is scarce and compute is abundant. Both conditions are central to interpreting the result. It does not show that diffusion models beat autoregressive models across ordinary data and compute regimes.

Work in 2025 and 2026 explores scaling, reducing the number of refinement steps, training with constrained data and making decoding more flexible. These directions show that diffusion language modeling is an active research area. They do not establish that every deployed diffusion model has adopted these methods or beats a comparable autoregressive model.

These are different research questions, not one combined benchmark. A result about data scarcity does not prove fewer-step inference is faster; a flexible-length method does not, by itself, establish higher reasoning quality.
How should you compare a specific pair of models?
Compare the systems on the work you actually need them to do, not on the architecture name alone. A fair evaluation should make the task, model scale, compute, decoding settings and hardware visible, then measure the outcome that matters to your use case.
- Choose representative tasks. Include the kind of work you expect—such as ordinary text generation, infilling or instruction following—rather than relying on a single broad label like “language quality.”
- Match the comparison conditions. Record the model sizes, available compute, decoding method and hardware. If these differ substantially, treat the result as a comparison of complete systems, not just architectures.
- Measure latency and throughput separately. Record per-request response time and performance under the batching conditions relevant to deployment. Do not infer one from the other.
- Check editing and length behavior directly. If filling gaps, revising positions or generating variable-length output matters, verify that behavior in the specific model rather than assuming it from the word “diffusion.”
- Assess quality on the intended task. Use the same task and evaluation conditions for both systems. A result from one paper’s specialized training regime may not transfer to a different workload.
This approach reflects the central limitation of broad architecture claims: speed and quality are properties of particular model-and-inference setups. The evidence discussed here does not provide a universal benchmark that replaces a task-specific comparison.
Frequently Asked Questions
Does a diffusion LLM generate one word at a time?
Not necessarily. Models operate on tokens, which may be whole words, word fragments or other units; the defining contrast is iterative sequence refinement rather than a strictly left-to-right next-token chain.
Can an autoregressive model edit text it has already generated?
The defining next-token process extends a prefix, but that does not rule out editing features built around an autoregressive model. Architecture alone does not tell you whether a particular product supports revision or infilling.
Does the word “diffusion” mean every model uses the same noise process?
No. Some approaches operate directly on discrete tokens and others use continuous representations, and their corruption and decoding procedures can differ.
