Evaluate a zero-shot model on more than accuracy: measure whether its confidence matches its correctness, whether it ranks errors as risky, and how accurately it performs when you keep only its most confident answers. Those are different questions, so a sound evaluation combines calibration metrics, error-ranking metrics, and selective-prediction results. It also fixes the prompt, decoding settings, and correctness rubric, because confidence depends on the whole setup—not just the model.
What does a zero-shot confidence evaluation need to show?
It should show both what the model gets right and whether its confidence is useful for deciding what to trust, review, or defer. A single accuracy score cannot tell you whether a model knows when it is likely to be wrong.

Do these 3 things before closing this tab:
1Repair Windows errors before they cause bigger problems2Fix the driver behind crashes, sound loss and screen glitches3Clear out junk files and repair common Windows errorsFor a prediction assigned confidence 0.8, calibration means that predictions with similar confidence should be correct roughly 80% of the time over a suitable set of examples. That is a population-level statement: it does not establish that any one prediction carrying an 0.8 score has an 80% chance of being correct in some individually knowable sense.
In practice, evaluate four axes:
- Correctness: How often does the model meet the task’s predefined correctness rule?
- Calibration: Do confidence values correspond to observed correctness rates?
- Error detection: Does confidence rank correct outputs above incorrect ones?
- Selective coverage: How accurate is the subset you retain, and how much work can you retain while meeting an accuracy target?
When deployment conditions may differ from the benchmark, add robustness checks across tasks, prompts, model families, and distribution shifts. The CALIBER work by Finlay and coauthors, published by the Association for Computational Linguistics in 2026, reports that aligning confidence estimates with the model’s information state was especially useful under shift.

How do you set up a fair evaluation?
Define the task and freeze the elicitation procedure before comparing confidence methods. Otherwise, a score may reflect differences in prompting, sampling, or answer grading rather than a model’s ability to signal risk.
- Choose representative labeled tasks. Use examples that match the intended deployment. Write down what counts as correct before generating answers. For open-ended outputs, choose and document a rule such as exact match, semantic equivalence, claim-level correctness, or a judge-based rubric.
- Freeze the prompt and decoding policy. Record the system and user prompts, required answer format, temperature, top-p, number of samples, stop conditions, and any retrieval or tool context. Keep these fixed across the methods you compare. Confidence is conditional on this complete setup.
- Collect the output and confidence signals. Where available, record token or class probabilities. You can also ask for verbalized numerical confidence or estimate confidence from agreement across sampled answers. Keep the confidence-elicitation prompt fixed if you are comparing signals.
- Split calibration from final testing. If you fit a recalibration method, fit it on a calibration split, then report final performance on a separate test split. Do not select a winning method using the same test results used to make the headline comparison.
- Calculate complementary metrics. Include a calibration diagnostic, a proper scoring rule such as Brier score or negative log-likelihood, a ranking measure such as AUROC or AUPRC, and selective-prediction results.
- Show reliability and operating points. Plot confidence bins against observed accuracy and report a practical threshold—for example, the coverage achieved at a required accuracy. A scalar alone hides how a system behaves where it would actually be used.
- Repeat under relevant variation. Evaluate additional tasks, domains, prompt variants, and model families. If the deployment distribution differs from the benchmark, include a shifted or out-of-distribution slice.
The final report should preserve the configuration that produced each result: task, correctness rule, prompt, decoding policy, confidence signal, metric settings, and data split. Without these, a confidence number is hard to interpret or reproduce.
What is the difference between ECE, Brier score, NLL, AUROC, and AUPRC?
ECE, Brier score, and negative log-likelihood assess probability quality or confidence–accuracy alignment. AUROC and AUPRC assess ranking: whether confidence tends to put correct examples ahead of errors. Selective metrics answer a different operational question—what happens when you defer low-confidence cases?
| Metric | What it answers | What it does not answer | Preferred direction |
|---|---|---|---|
| Expected calibration error (ECE) | How far average confidence is from empirical accuracy across confidence bins. | Whether every individual prediction is reliable or whether the chosen bins give a stable picture. | Lower |
| Brier score | How close confidence probabilities are to binary correctness labels. | Whether ranking alone is strong; its decomposition needs careful interpretation. | Lower |
| Negative log-likelihood (NLL) | How well predicted probabilities assign mass to observed outcomes, with a strong penalty for overconfident errors. | Whether a threshold-based abstention policy works well operationally. | Lower |
| AUROC | Whether confidence ranks correct cases above incorrect ones. | Whether a stated probability such as 0.8 corresponds to 80% correctness. | Higher |
| AUPRC | How well confidence ranks outcomes when class balance or failure prevalence matters. | Whether confidence is numerically calibrated. | Higher |
| Accuracy at coverage | Accuracy among the most confident predictions retained at a fixed coverage level. | Calibration across the full population. | Higher at fixed coverage |
| Coverage at accuracy | The largest fraction of predictions retained while meeting a required accuracy threshold. | How probabilities behave away from that operating threshold. | Higher at fixed accuracy |
Why isn’t ECE enough?
ECE summarizes the difference between average confidence and empirical accuracy within bins. Its value depends on how predictions are grouped, so report the binning configuration and check whether conclusions change under reasonable alternatives, including adaptive binning. Guo and coauthors found that metric choices can materially change the ranking of recalibration methods.
ECE can also look favorable when a model issues uninformative confidence values close to the base rate. A low ECE alone therefore does not mean confidence is useful for distinguishing safer from riskier outputs. Pair calibration with an error-ranking metric, selective results, or an oracle-normalized utility measure. Local-calibration work by Luo and coauthors also warns that population-average ECE can miss fine-grained modes of miscalibration.

When do Brier score and NLL help?
Both score probability quality against observed outcomes rather than checking only a thresholded prediction. NLL penalizes assigning very little probability to the outcome that occurs, making overconfident errors particularly costly. Brier score provides a squared-error view of predicted confidence against correctness labels. Neither score, by itself, tells you the accuracy you will get after deferring a chosen fraction of cases.

Use them when you need to know whether confidence can sort likely successes from likely failures. AUROC summarizes ranking across thresholds; AUPRC can be more informative when failures are relatively rare or class balance matters. Neither is evidence that a model’s reported probabilities are trustworthy: a model can rank errors well while its numerical confidence is systematically too high or too low.
How do you test whether confidence supports abstention?
Choose a confidence rule for retaining outputs, then measure the accuracy and workload of the retained subset. Coverage is the fraction of all cases the system answers rather than defers; selective accuracy is the accuracy among those retained cases.
Report accuracy at coverage
Set a coverage level, such as the fraction of cases the workflow expects to process automatically, and report accuracy among the retained predictions. Compare methods at the same coverage. This reveals whether one confidence signal concentrates errors in the cases it would send for review.
Report coverage at accuracy
Set the minimum accuracy required by the use case, then report the largest fraction of cases that can be retained while meeting it. This makes the trade-off legible to a team deciding how much work can be automated and how much must be escalated.

Show at least one threshold or operating point alongside the broader curve or range of results. The threshold should be selected using calibration or validation data and then evaluated on the held-out test split. Choosing it after inspecting the final test outcomes makes the reported operating point optimistic.
Do not infer abstention value from AUROC alone. Ranking can be promising even when confidence values are not calibrated; conversely, average calibration does not guarantee that a particular threshold yields a useful retained workload. The decision depends on the task’s required accuracy, the cost of errors, and the available review capacity.
Which confidence signals can you compare?
Confidence can come from different parts of the system, and each signal has different costs and assumptions. Compare them under the same tasks, data splits, and elicitation setup rather than treating them as interchangeable probabilities.
| Confidence signal | How it is obtained | What to watch |
|---|---|---|
| Logit or token-probability confidence | Use class probabilities or token probabilities exposed by the model or API. | It is natural for classifiers and probability-exposing APIs, but may be unavailable or poorly calibrated after instruction tuning. |
| Verbalized confidence | Ask the model to return a probability or confidence score in a constrained format. | Keep the elicitation prompt and output format fixed; the reported number is a model-generated signal, not automatically a calibrated probability. |
| Consistency confidence | Sample multiple answers and use agreement or semantic clustering as a proxy. | It costs additional inference and depends on a defensible rule for deciding when answers mean the same thing. |
| Hidden-state predictor | Train a separate predictor, such as P(IK), to estimate whether the model will answer correctly. | Treat it as a learned evaluator: calibrate it and validate it on held-out data rather than assuming it generalizes. |
| Before-versus-after reasoning confidence | For reasoning models, distinguish confidence that a problem is solvable from confidence that the produced answer is correct. | Those estimates describe different information states and should not be collapsed into one score without checking their intended meaning. |
In experiments across several RLHF models and tasks, Tian and coauthors reported that verbalized confidence was often better calibrated than sampled conditional probabilities. Their 2023 paper, Just Ask for Calibration, reports relative ECE reductions often around 50% in the cited experiments. That is a study-specific result, not a general expectation for every model, prompt, or task.

How should you compare recalibration methods?
Compare methods using the same task, data protocol, and evaluation metrics, then choose based on the operating point the application needs—not the smallest ECE in isolation.

Temperature scaling is a useful baseline for recalibrating confidence, but it is not a guarantee that calibration will transfer across tasks or domains. The comparison can also include label smoothing, verbalized confidence, P(IK), and self-consistency, provided each method is evaluated on held-out data with the same correctness rule.
Report sensitivity to metric configuration, especially ECE binning, as well as selective behavior. A method can improve one calibration summary while failing to improve error ranking or the amount of work that can safely be retained. If results vary between tasks, prompts, or shifted data, show those results separately rather than averaging away the deployment-relevant differences.

Each figure belongs to its study’s model, dataset, prompt, confidence signal, metric configuration, and comparison baseline. It should not be read as a performance promise for a different model or deployment. Re-run the evaluation on the intended domain and preserve the exact setup used to generate the results.
What should the final evaluation report include?
A useful report lets a reader see both probability quality and operational consequences. Include enough detail to reproduce the evaluation and decide whether its confidence signal fits the intended workflow.

Frequently Asked Questions
Can log probabilities be compared directly across different models?
Not safely by default. The scores may come from different tokenization, output formats, or probability interfaces, so compare their performance against the same labeled outcomes and evaluation protocol rather than treating the raw values as a shared scale.
Does a calibrated confidence score tell me why the model is wrong?
No. Calibration describes the relationship between confidence and observed correctness across examples; it does not provide an explanation of an individual error or identify its cause.
Should confidence be calculated over an entire answer or each claim?
Use the unit that matches the decision you need to make. If an answer can mix correct and incorrect claims, a single answer-level label can conceal that variation, so a claim-level correctness rule may be more appropriate when the workflow acts on individual claims.
