Use both keyword and semantic retrieval, merge their ranked candidates, and rerank only that shortlist. Keyword search protects exact symbols, filenames, diagnostics, and issue IDs; semantic search finds code whose behavior is described with different words. Reciprocal rank fusion (RRF) is a practical way to combine the lists without pretending that BM25 and vector scores share a scale. A cross-encoder or other stronger reranker can then judge query–document pairs in detail. Keep retrieval, fusion, and reranking behind separate interfaces so you can move between local and hosted models without redesigning the whole system.

What is code-review retrieval, and why use three stages?

Code-review retrieval is the task of finding the most useful code, diffs, comments, tests, and historical discussions for a reviewer’s question. A query might be an exact token such as parse_auth_header, an error string, or a natural-language request such as “where do we reject expired refresh tokens?” No single retrieval method handles both cases reliably.

A production-friendly design separates the work into:

  1. Candidate retrieval: run a lexical search and a semantic/vector search in parallel.
  2. Fusion: combine the ranked lists into one candidate set.
  3. Reranking: apply a more accurate, usually more expensive model to that smaller set.

The separation matters operationally. First-stage retrieval must be fast enough to search the whole repository. Reranking can spend more computation because it sees perhaps a few dozen documents rather than millions. A reranker can change the order of candidates it receives; it cannot recover a relevant file that both first-stage searches omitted.

Microsoft Learn’s Azure Architecture Center describes Reciprocal Rank Fusion as “a score-free method for merging ranked result lists from different search approaches.” That property is useful because BM25 scores and cosine-similarity scores are not automatically comparable.

How do keyword and semantic search complement each other?

Keyword retrieval is strongest when the query contains a literal clue; semantic retrieval is strongest when the query describes intent or behavior. Combining them improves coverage, but neither should be treated as universally superior.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

When keyword search wins

  • Exact function, class, variable, or API names.
  • Filenames, paths, branch names, ticket IDs, and commit references.
  • Compiler diagnostics, exception text, log messages, and protocol fields.
  • Rare acronyms or configuration keys where a synonym would be wrong.

Use an information-retrieval engine such as BM25 with analyzers that preserve code-relevant tokens. Index identifiers in useful forms (for example, both refresh_token and “refresh token”), but retain the original token so an exact query can receive a strong boost. Consider separate fields for path, symbol, language, comments, and diff text; a match in a function name should usually count differently from a match in a generated comment.

When semantic search wins

  • Behavioral descriptions whose wording does not occur in the source.
  • Questions about intent, such as “how is a user promoted after paying?”
  • Queries that use domain language while the code uses implementation terminology.
  • Finding analogous tests or implementations written with different names.

A bi-encoder creates an embedding for each document chunk ahead of time and one for the query at request time. Approximate-nearest-neighbor search then compares vectors efficiently. This gives broad conceptual recall, but embeddings can blur distinctions between similarly shaped symbols, especially in large repositories.

Why a hybrid query is safer for code

Code mixes natural language, rigid identifiers, and repeated boilerplate. A semantic-only system may return a conceptually related module while missing the exact symbol under review. A keyword-only system may miss the implementation because the reviewer’s wording differs from the code. Running both searches lets each signal cover the other’s blind spots.

What is the complete hybrid-retrieval pipeline?

Build, fuse, rerank, and evaluate in that order. The following design keeps each stage replaceable.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

1. Prepare repository documents

Choose a document unit that matches review tasks. A whole repository file may be too large and mix unrelated symbols; tiny line windows may lose context. Practical units include a function with its signature and docstring, a class with selected methods, a test case, a diff hunk, or a review comment plus its referenced lines.

Store metadata alongside text:

  • Repository, revision or commit, branch, and file path.
  • Language, symbol name, start and end lines, and ownership labels if available.
  • Document type (source, test, diff, comment, issue, or build output).
  • Access-control information so retrieval never exposes code a user cannot read.

Chunking should be deterministic. If a file changes, re-embed only affected chunks and retain a revision identifier so a result can be opened at the exact commit being reviewed. Exclude secrets, vendored dependencies, and generated output unless a specific review workflow needs them.

2. Run lexical retrieval

Send the original query, plus carefully handled token variants, to a BM25-style index. Do not over-normalize identifiers: splitting OAuthErrorCode into words is useful for recall, but the unsplit form should remain searchable. Boost exact matches in symbol and path fields and use filters for repository, language, branch, or review scope.

Record the ordered document IDs and their ranks. You do not need to make BM25 scores comparable with vector scores if you plan to use RRF.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

3. Run semantic retrieval

Embed the same query and search the vector index. Use the same permission and revision filters as the lexical query. Retrieve enough candidates to protect recall; the right count depends on corpus size and latency, so measure it rather than copying a universal number.

For code, embedding inputs can include a short structured prefix such as the language, symbol, and path followed by the source text. Keep that format stable between indexing and querying. If you change the embedding model or chunk format, rebuild the affected vectors and evaluate again.

4. Fuse ranked lists with RRF

For each result, calculate:

RRF(d) = Σ 1 / (c + rank(d))

The sum runs over the retrieval lists in which document d appears. Microsoft documentation identifies 60 as a commonly used value for c; it is a conventional setting, not an immutable standard. Rank is normally one-based. A document appearing near the top of both lists receives a larger combined score than one appearing high in only one list.

RRF avoids a common mistake: adding a BM25 score directly to a cosine similarity. Those scores have different distributions, and normalizing them can be unstable across queries. RRF uses rank positions, so the method remains a simple baseline even when the backends are changed.

5. Select a reranking shortlist

Deduplicate fused results by stable document ID, then pass the top N candidates to a reranker. Choose N from latency and recall measurements. A larger shortlist gives the reranker more opportunities but increases compute and may dilute context. Preserve the retrieval rank and source list as features for debugging, even if the reranker ultimately makes the final ordering.

6. Rerank query–document pairs

A cross-encoder reads the query and one candidate together and outputs a relevance score. Because it performs joint attention, it can distinguish subtle relationships that separate embeddings miss. Sentence Transformers documents this retrieve-and-rerank pattern as a fast first stage followed by slower cross-encoder scoring.

Pass enough context for a meaningful judgment but avoid overflowing the model’s input limit. For a diff, include the hunk plus file path and symbol; for a source chunk, include its signature and a bounded amount of surrounding code. Return the original document ID, reranker score, and model version so results are reproducible.

Some platforms call their second-stage component “semantic ranking.” Azure AI Search documents a configuration that reranks the top 50 initial results. That 50-result window is Azure-specific; it is not a universal rule for every reranker.

How should I implement portable reranking?

Portability is an architecture choice, not a promise that every model API is interchangeable. Define stable internal contracts and put each backend behind an adapter.

Use explicit interfaces

type Candidate = {
  id: string
  text: string
  metadata: Record<string, string>
  retrieval_rank: number
  sources: string[]
}

interface Retriever {
  search(query: string, limit: number, filters?: Filters): Promise<Candidate[]>
}

interface Fusion {
  merge(lists: Candidate[][]): Candidate[]
}

interface Reranker {
  score(query: string, candidates: Candidate[]): Promise<ScoredCandidate[]>
}

The application should call Retriever for lexical and vector backends, Fusion for RRF, and Reranker for a local model, hosted endpoint, or platform-native service. Keep authentication, batching, retries, timeouts, and model-specific request formats inside the adapter.

Keep the request and response shape stable

Send each reranker a query and an ordered array of candidates with IDs and text. Require a response that maps every returned score to the original ID. If a service truncates inputs, reports partial failures, or returns a different ordering, the adapter should expose that explicitly rather than silently dropping documents.

Compare deployment options on the right axes

Option Strengths Trade-offs to measure
Local cross-encoder Repository content stays under your control; predictable integration and offline operation. GPU/CPU capacity, model downloads, upgrades, and operational ownership.
Hosted reranking endpoint Less model infrastructure and elastic capacity; several vendors and model families are available. Network latency, per-request cost, rate limits, data egress, retention terms, and outage handling.
Platform-native semantic ranker Integrated authentication, monitoring, and search pipeline support. Platform-specific candidate limits, pricing, region availability, and migration effort.
Custom service adapter One internal contract can front multiple models and backends. Engineering work for compatibility, testing, versioning, and fallback behavior.

Elastic documents pipelines that combine BM25 and vector retrieval with RRF and then semantic reranking. Its documented integration routes include Elastic-hosted endpoints, Jina, Cohere, Google Vertex AI, and models uploaded from Hugging Face. These are integration paths, not evidence that the services have equal quality, price, privacy, or latency.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Microsoft’s guidance recommends checking relevance, pricing, latency, and whether sending document content to an external API satisfies security and compliance requirements. Treat those checks as part of the design review, not as an afterthought.

Which reranker model type should I choose?

Use bi-encoders for scalable first-stage retrieval and cross-encoders for high-precision ordering of a limited candidate set.

Characteristic Bi-encoder Cross-encoder
Encoding Query and document encoded separately. Query and document processed together.
Indexing Document vectors can be precomputed and searched efficiently. Each query–document pair requires model inference.
Typical role Repository-wide candidate recall. Second-stage precision on a shortlist.
Failure mode May blur exact distinctions or miss wording-specific relevance. Can be too slow or costly when applied to the whole corpus.

A cross-encoder is not automatically better overall: if the first stage omits the right file, no reranker can add it. Conversely, retrieving thousands of candidates and cross-encoding all of them usually defeats the latency reason for a two-stage design.

How do I evaluate a code-review retrieval system?

Evaluate on real repository questions, with relevance labels and operational measurements. A benchmark result is useful context, not a production guarantee.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Build a representative query set

  • Exact-symbol queries and diagnostic strings.
  • Natural-language behavior questions from actual reviews.
  • Queries spanning languages, repositories, and document types.
  • Fresh reviews plus historical issues where the accepted fix is known.

For each query, label which files, chunks, diffs, tests, or comments are useful. Record whether a result is essential, helpful, or irrelevant; binary labels can hide the difference between the correct implementation and a merely related one.

Compare controlled variants

  1. Lexical retrieval only.
  2. Semantic retrieval only.
  3. Hybrid retrieval with RRF.
  4. Hybrid retrieval followed by reranking.

Keep filters, candidate limits, and corpus snapshots consistent. Measure recall of relevant material in the candidate set, final ranking quality, and p50/p95 latency. Track CPU/GPU use, memory, hosted API charges, error rates, and cache hit rates. Also test permission boundaries and stale-index behavior.

Interpret published numbers carefully

The 2023 TOSS code-search study reports an overall mean reciprocal rank (MRR) of 0.763 on CodeSearchNet, compared with 0.713 for its best baseline under that paper’s experimental conditions. It describes a two-stage approach in which information-retrieval and bi-encoder methods recall candidates and cross-encoders refine the ranking. The result demonstrates what that method achieved on that benchmark; it does not predict an identical improvement on your repository or review workload.

A 2020 ACM Computing Surveys article reviewed 81 code-search studies. That scope is useful historical context, but it should not be read as a current census of models or products.

What practical tuning choices affect quality and cost?

Candidate depth

Increase lexical and vector limits when relevant documents are often absent from the fused pool. Then measure the point at which recall stops improving while reranking latency continues to rise. Keep separate limits for each source if one backend has a much broader or noisier result distribution.

RRF weighting

Start with equal list weights and the commonly documented c = 60 setting. If evaluation shows that one signal is consistently more reliable for a query class, test a weighted variant, but report the rule and validate it on held-out queries. Do not infer a weight from raw score magnitudes.

Chunk and context design

Very small chunks improve pinpointing but can remove imports, type definitions, or callers needed to understand relevance. Very large chunks create noisy embeddings and expensive reranker inputs. Test symbol-level chunks, diff hunks with surrounding lines, and small windows around matches; choose the format that improves judged relevance at acceptable latency.

Filters and freshness

Apply repository, branch, language, and access filters before ranking whenever possible. Index commit IDs and invalidate or down-rank stale documents so a review does not surface code that no longer exists. A fresh but slightly less similar result is often more useful than a perfect match from an old revision.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Caching and batching

Cache document embeddings and, where policy permits, repeated query results. Batch cross-encoder pairs to use accelerator hardware efficiently, but enforce a maximum batch size and timeout. Hosted services may have request-size or rate limits; the adapter should split batches and preserve candidate IDs.

What are the common failure modes and fixes?

  • Exact symbols never appear: Check tokenization, case handling, path fields, and whether generated or test files were excluded. Add field boosts or a literal-match branch instead of relying on embeddings.
  • Semantic results are all from one module: Increase candidate diversity, deduplicate near-identical chunks, and include multiple first-stage models or lexical candidates. The TOSS study notes that complementary first-stage models can improve recall diversity.
  • Reranking is slow: Reduce shortlist size only after measuring recall, batch pairs, shorten context, or use a smaller local model. Do not apply a cross-encoder to the full corpus.
  • Reranker changes nothing: Inspect whether candidates are nearly identical, whether the model receives enough context, and whether the query language matches the model’s training. A reranker cannot fix missing candidates.
  • Scores look inconsistent after a backend swap: This is expected across models and providers. Compare rankings and task metrics, not absolute score values, and keep an adapter-level calibration only if your application truly needs thresholds.
  • Sensitive code leaves the network: Review the provider’s retention and processing terms, remove secrets, enforce tenant isolation, or deploy a local model. Security and compliance requirements can rule out an otherwise accurate endpoint.
  • Results point to the wrong revision: Include commit metadata in the index key and result display, and reject documents that do not match the review’s revision policy.

How should a portable implementation expose results to reviewers?

Show why each result was retrieved without overwhelming the reviewer. A useful result card contains the path, symbol, revision, line range, short excerpt, final rank, and document type. You can also display badges such as “keyword match,” “semantic match,” or “both,” while keeping internal scores available for diagnostics.

When a reviewer opens a result, preserve the exact commit and line context used for ranking. If the system combines source, diff, and discussion documents, label each type clearly. Log query text, candidate IDs, model versions, latency, and failures under your organization’s privacy policy so regressions can be reproduced.

When is hybrid retrieval with reranking worth the extra complexity?

It is worthwhile when reviewers ask both exact and behavioral questions, when repository scale makes exhaustive model scoring impractical, and when a modest latency increase is acceptable for better ordering. A lexical-only system may be sufficient for a small, consistently named codebase; a semantic-only system may be adequate for exploratory concept search. Measure before committing to the extra stage.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

The safest rollout is incremental: instrument the existing search, add semantic candidates behind a feature flag, fuse with RRF, then enable reranking for a limited traffic slice. Compare judged relevance and p95 latency against the baseline, and retain a lexical fallback for outages or model regressions.

Frequently Asked Questions

Can I rerank results from two different search engines?

Yes. Return a common candidate object containing a stable ID, text, metadata, and source rank, then pass the fused objects to the reranker. The model does not need to know which engine produced a candidate, but your adapter must preserve permissions, revision metadata, and consistent text formatting.

Does RRF require normalizing BM25 and vector scores?

No. RRF uses rank positions, so it avoids direct comparison of incompatible score scales. You still need to decide candidate limits, duplicate handling, and optional list weights, then validate those choices on your own queries.

How much code should I put into one embedding chunk?

There is no universal line count. Start with syntax-aware units such as functions, classes, tests, or diff hunks, include the signature and limited surrounding context, and compare judged recall against larger and smaller chunks on representative reviews.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Can a reranker find a file that semantic and keyword search missed?

No. Reranking only reorders the candidates it receives. Improve first-stage recall, candidate depth, indexing freshness, or query expansion when the relevant file is absent before tuning the reranker.
