There is no single best Python framework for every multi-agent application. Choose LangGraph for durable, stateful, auditable workflows; CrewAI for the fastest role-based team prototypes; Microsoft Agent Framework for Azure, Microsoft Foundry, .NET, or AutoGen/Semantic Kernel estates; LlamaIndex Workflows for retrieval and document pipelines; Google ADK for Google Cloud and Gemini-centered systems; and the OpenAI Agents SDK for compact applications built around a few agents, tools, and handoffs.

The right decision depends on the hardest constraint in production: resumable state, explicit control, retrieval, cloud alignment, provider portability, or minimal abstraction. The framework that produces the quickest demo is not necessarily the one that can recover a failed run, pause for approval, explain its decisions, and be operated economically over months.

What is the best Python framework for multi-agent AI?

The best default for a serious, stateful system is LangGraph because it makes the execution graph, persistence, interruptions, and recovery explicit. That recommendation changes when the application is primarily a role-playing team, a document pipeline, or a cloud-specific deployment: CrewAI, LlamaIndex Workflows, Microsoft Agent Framework, Google ADK, or OpenAI Agents SDK may then be a better fit.

Use the following map before writing code:

Primary requirement Most natural choice Why
Durable, restartable, auditable orchestration LangGraph Low-level graph runtime with persistence, durable execution, human-in-the-loop state changes, memory, streaming, and tracing.
Role-based collaboration and rapid prototyping CrewAI Flows handle state and control while Crews coordinate role-playing agents.
Azure, Microsoft Foundry, .NET, or existing AutoGen/Semantic Kernel work Microsoft Agent Framework Combines agent abstractions with enterprise workflow, session, identity, middleware, MCP, and telemetry capabilities.
Retrieval, knowledge, and document-heavy processing LlamaIndex Workflows Event-driven Python steps can retrieve, branch, loop, request input, and run concurrently.
Google Cloud and Gemini alignment Google ADK Opinionated, batteries-included runtime with workflow and debugging support.
A small set of agents, tools, and handoffs OpenAI Agents SDK Compact delegation model with relatively little framework overhead.
Broad integrations and a conventional agent loop LangChain Higher-level framework for models and tools; move to LangGraph when explicit state-machine control becomes central.

These are fit recommendations, not a league table. No independent cross-framework benchmark establishes a universal winner for reliability, latency, token consumption, operating cost, or market share.

How should you choose a framework before building?

Start with the constraint that would be most expensive to retrofit. A framework can hide the execution loop and make a demonstration simple, but hidden state and implicit retries become liabilities when a run lasts hours or needs a human decision.

  1. Define the failure you must survive. If a process must resume after a worker or model outage, durable state and checkpoint semantics outrank a friendly agent API. If a process is short-lived and stateless, a lighter abstraction may be sufficient.
  2. Describe the coordination model. Decide whether work is an explicit graph, a Flow that invokes a Crew, an event-driven workflow, or a set of handoffs between agents. This choice determines where branching, loops, parallelism, and approval gates live.
  3. List provider and tool constraints. Confirm model portability, required vendor features, tool calling behavior, and whether your design needs the Model Context Protocol (MCP). Provider-specific conveniences can reduce setup time but increase migration work later.
  4. Specify state and approvals. Write down what must be persisted, what an operator can edit, and where execution can pause. Treat short-term run state, long-term memory, and business records as separate design concerns.
  5. Plan observability and evaluation. Decide how traces, prompts, tool calls, intermediate state, and final outcomes will be captured. A multi-agent system that cannot be replayed or inspected is difficult to debug regardless of framework.
  6. Prototype one representative workflow. Measure reliability, latency, token use, and debugging effort on a workflow containing the longest path, a failure, a tool call, and (if relevant) an approval. A short happy-path demo is not a production benchmark.

Why is LangGraph the strongest general default?

LangGraph is a low-level orchestration framework and runtime for long-running, stateful agents. You model execution as a graph and can mix deterministic, hand-coded steps with LLM-driven steps. That explicitness is valuable when a run must be inspected, interrupted, modified, and resumed.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Capabilities that matter in production

  • Durable execution: persisted progress lets a workflow continue after failures instead of restarting from the beginning.
  • Human-in-the-loop control: an operator can inspect or modify state at an interruption point before execution continues.
  • Memory: short-term run state and longer-lived memory can be represented as part of the application design.
  • Streaming and tracing: incremental output and execution traces make long runs observable, with LangSmith commonly used for tracing and evaluation.
  • Hybrid control: deterministic validation, routing, and side effects can sit beside model-driven decisions in one graph.

When LangGraph is a poor fit

The same low-level control creates more architecture work. You must design state schemas, transitions, retry behavior, idempotency, persistence, and approval boundaries instead of relying on a high-level crew abstraction. For a small assistant with a handful of tools and no need to resume a long run, that engineering may not pay back.

Should you use CrewAI for role-based teams?

CrewAI is usually the quickest route when the problem naturally decomposes into specialist roles such as researcher, analyst, writer, and reviewer. Its architecture separates Flows, which define state, events, branching, and overall control, from Crews, which are teams of role-playing agents that collaborate and delegate.

How to structure a CrewAI production application

The documentation recommends starting a production application with a Flow and invoking a Crew for complex autonomous work. This keeps business-level orchestration, state transitions, and external side effects in the Flow while allowing a Crew to handle an open-ended team task inside a bounded step.

  • Use a Flow to receive the request, validate inputs, choose a path, persist status, and decide whether human approval is required.
  • Use a Crew where role-based discussion or delegation is genuinely useful, rather than assigning multiple agents to a task one deterministic function could complete.
  • Return structured results from the Crew so that the surrounding Flow can validate them before writing to a database or calling an external system.

CrewAI’s documentation says, “With over 100,000 developers certified through our community courses, CrewAI is the standard for enterprise-ready AI automation.” That is a vendor-published claim about its community and positioning, not an independent market-share or quality statistic.

CrewAI trade-offs

Role descriptions make a team easy to explain and prototype, but they can also encourage unnecessary agent-to-agent conversation, extra model calls, and ambiguous responsibility. Add explicit limits on delegation, retries, context size, and wall-clock time. If you need fine-grained pause-and-resume semantics across every node, compare the Flow model with a lower-level graph runtime before committing.

When is Microsoft Agent Framework the right choice?

Microsoft Agent Framework is the natural choice for teams whose constraints are already Microsoft-centric: Azure AI Foundry, Microsoft identity and operational tooling, .NET services, or an existing AutoGen or Semantic Kernel investment. Microsoft describes it as combining AutoGen’s agent abstractions with Semantic Kernel’s enterprise features and as the direct successor to both projects.

What it provides

The framework covers agents, tools, MCP servers, sessions, context providers, middleware, telemetry, and functional or graph-based workflows. That breadth is useful when an agent system must fit established enterprise identity, networking, monitoring, and application-hosting patterns rather than run as an isolated Python experiment.

Migration and availability caution

Organizations moving from AutoGen or Semantic Kernel should inventory prompts, tool contracts, state handling, telemetry, and deployment assumptions before migrating. Components may have different preview or general-availability status; verify the status and supported APIs for the exact release you plan to deploy instead of assuming that every capability is production-ready.

Is LlamaIndex Workflows best for RAG and document agents?

LlamaIndex Workflows is particularly well suited to systems whose central problem is retrieving, transforming, validating, and routing information from documents or knowledge stores. Workflows are event-driven Python steps rather than a free-form conversation among named roles.

What a document workflow can do

  • Receive a document or question and emit events as parsing, indexing, retrieval, and synthesis complete.
  • Call an LLM or a retrieval component at a specific step, with ordinary Python controlling the surrounding logic.
  • Branch on metadata or confidence, loop over pages or sources, and dispatch concurrent work for independent sections.
  • Pause for human input when extraction is ambiguous, then update shared state and continue.

This model keeps retrieval and document operations visible in the application code. It is often a better match than a role-playing crew when the “agents” are really specialized stages in a knowledge pipeline.

Which framework fits Google Cloud or OpenAI applications?

Choose the framework that reduces integration work without hiding requirements you will later need to control. Google ADK is aligned with Google Cloud and Gemini-centered deployments; the OpenAI Agents SDK is aimed at tightly scoped delegation with a compact API.

Google ADK

The comparative survey characterizes Google ADK as an opinionated, batteries-included runtime with workflow and debugging support. It is a sensible starting point when Gemini models, Google Cloud identity, deployment, and observability are primary constraints. Confirm the target release’s provider and model support, because cloud integrations and APIs change quickly.

OpenAI Agents SDK

The OpenAI Agents SDK fits applications with a small number of agents, tools, and handoffs where the team values a minimal abstraction layer. It can keep the control surface compact, but you still need to design persistence, approvals, tracing, and evaluation if the application becomes long-running or business-critical. Do not infer durable execution or broad provider portability from a small handoff API; verify those capabilities for the release you select.

Where does LangChain fit compared with LangGraph?

LangChain is the higher-level starting point when broad model and tool integrations and a conventional agent loop matter more than custom state-machine control. LangGraph is the lower-level orchestration runtime for applications that need explicit branching, persistence, durability, and human-in-the-loop execution.

A practical progression

  1. Start with LangChain if the application is a straightforward tool-using agent and you need to connect models and integrations quickly.
  2. Move orchestration into LangGraph when you add durable checkpoints, multiple branches, long-running jobs, approval pauses, or complex recovery rules.
  3. Keep the model and tool integrations that remain useful, but make state transitions and side effects explicit in the graph.

This is not a mandatory migration path. If your requirements already include resumability and audited state, begin with the lower-level runtime rather than building a prototype around assumptions you will later replace.

What are the key differences among the leading frameworks?

The table below compares architectural emphasis rather than marketing tiers. “Best fit” describes the use case each project’s documented design serves most directly.

Framework Coordination model State and recovery emphasis Distinctive strength Main engineering trade-off
LangGraph Explicit graph of deterministic and model-driven nodes Durable execution, persistence, interruption, resume Auditable control of long-running workflows More state-machine and operational design work
CrewAI Flows plus role-based Crews Flow-managed state and events Fast specialist-team prototypes Unbounded delegation can increase calls and ambiguity
Microsoft Agent Framework Functional or graph workflows with agents and tools Sessions, middleware, telemetry, enterprise integration Microsoft ecosystem and migration path Component availability and release status must be checked
LlamaIndex Workflows Event-driven Python steps Shared state, loops, concurrent dispatch, human input Retrieval and document pipelines Less natural for a purely role-play-oriented team
Google ADK Opinionated workflow runtime Workflow and debugging support Google Cloud and Gemini alignment Provider and cloud coupling
OpenAI Agents SDK Agent handoffs and tool delegation Application-defined for larger workflows Compact API for focused systems More infrastructure is needed as scope grows
LangChain Higher-level agent loop and integrations Use a lower-level runtime for advanced durability Broad model and tool connectivity Less direct control of complex execution paths

How do you design persistence, approvals, and observability?

These concerns should be designed before production, not bolted on after an agent appears to work.

Persistence and restart

Define a durable checkpoint boundary around every side effect: database writes, messages, payments, file changes, or external API calls. Store enough state to determine whether the side effect already happened, and make retries idempotent. A framework can persist workflow state, but it cannot decide which business operations are safe to repeat.

Human approval

Place an approval gate immediately before an irreversible or regulated action. Persist the proposed action, evidence, actor, timestamp, and decision. Let the operator reject, edit, or request more information, then resume from a known state rather than replaying the entire conversation.

Tracing and evaluation

Capture model requests, tool inputs and outputs, routing decisions, latency, token consumption, retries, and final business outcomes. Evaluate complete workflows, not only final text: a fluent answer can conceal an incorrect retrieval, an unauthorized tool call, or an unlogged failure.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

What operational pitfalls should you expect?

Too many agents

Adding agents does not automatically improve quality. Every extra role introduces coordination prompts, context transfer, latency, and another failure surface. Begin with the smallest decomposition that separates genuinely different skills or permissions.

Implicit state

If important state exists only in chat history, a process may be impossible to resume or audit. Promote business facts, approvals, identifiers, and tool results into explicit typed state or durable records.

Non-idempotent retries

Model and network failures are normal. Retrying a node that already sent an email, created a ticket, or charged an account can duplicate the side effect. Use idempotency keys and record completion before allowing automatic retry.

Provider lock-in discovered too late

Test the model and tool abstraction against the providers you may actually use. Provider-specific structured output, context limits, safety filters, and tool semantics can make a nominally portable agent behave differently after migration.

Confusing a demo with a benchmark

A successful short run says little about long-context behavior, queue contention, recovery, or operator workload. Include an outage, malformed tool result, approval pause, and partial completion in the representative prototype.

Is AutoGen still maintained, and what should existing users do?

Microsoft positions Microsoft Agent Framework as the direct successor to AutoGen and Semantic Kernel. Existing users should therefore evaluate the successor’s current release and migration guidance rather than assume that an older AutoGen architecture will receive the same feature investment indefinitely.

Do not migrate solely because of a label. Compare the behavior of your real workflows: agent and tool contracts, session state, middleware, telemetry, deployment, and failure recovery. Keep the existing system running while a representative path is ported and measured, especially if the successor component you need is still marked preview.

How should you estimate cost and performance?

There is no neutral, cross-framework data set establishing that one of these projects is cheapest or fastest. Runtime cost is driven by model choice, number of calls, context size, retrieval volume, tool latency, retries, concurrency, and the amount of human review.

Record these measures during your prototype:

  • End-to-end latency and the latency of each node or handoff.
  • Input and output tokens per agent and per completed business task.
  • Number of model calls, tool calls, retries, and abandoned runs.
  • Percentage of runs requiring human intervention and the time to resolve them.
  • Correctness of retrieved evidence, tool actions, and final outputs against a task-specific test set.
  • Engineering time required to reproduce, diagnose, and recover a failed run.

Use the results to choose an architecture, not to publish a universal ranking. Framework APIs, model support, cloud integrations, and maintenance status can change quickly, so recheck official documentation before fixing versions or promising availability.

Which framework should you pick for common application types?

Application Recommended starting point Reasoning
Long-running claims or approval process LangGraph Explicit checkpoints, interruption, state inspection, and resume are central.
Market-research team with researcher, analyst, and editor roles CrewAI Role-based collaboration maps directly to Crews, with a Flow around the business process.
Enterprise assistant inside an Azure estate Microsoft Agent Framework Identity, telemetry, MCP, sessions, and existing Microsoft investments reduce integration friction.
Invoice, contract, or knowledge-base pipeline LlamaIndex Workflows Event-driven retrieval, extraction, validation, branching, and human review fit the workload.
Gemini service deployed with Google Cloud tooling Google ADK Cloud and model alignment outweighs the value of a provider-neutral abstraction.
Small assistant that hands work between two or three specialists OpenAI Agents SDK A compact handoff model can avoid unnecessary orchestration machinery.
Prototype requiring many model and tool connectors LangChain Higher-level integrations shorten the path to a conventional agent loop.

What is the final selection rule?

Choose the framework that makes your hardest requirement explicit. For durable, inspectable execution, choose LangGraph; for role-based teams, CrewAI; for Microsoft estates, Microsoft Agent Framework; for document and retrieval workflows, LlamaIndex Workflows; for Google Cloud, Google ADK; for focused handoffs, OpenAI Agents SDK; and for broad integrations with a conventional loop, LangChain. Then validate the choice with a failure-inclusive prototype and production measurements rather than a polished demo.

Frequently Asked Questions

Can I combine two of these frameworks in one application?

Yes, but give each framework a clearly bounded responsibility. For example, an outer durable workflow can invoke a retrieval pipeline or a role-based team as one step, provided inputs, outputs, retries, and ownership of persistent state are explicit.

Does MCP make tools portable between agent frameworks?

MCP can standardize how compatible tools or servers are exposed, but it does not make model behavior, authorization, retries, or state management identical. Test each framework’s MCP implementation, authentication path, and error handling with the tools you will deploy.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

How many agents should a production system have?

Use the fewest agents that separate skills, permissions, or context boundaries you genuinely need. Add another agent only when measured quality, safety, or maintainability improves enough to offset extra model calls and coordination complexity.

What should a multi-agent evaluation set contain?

Include normal requests, ambiguous inputs, missing documents, malformed tool responses, provider errors, duplicate deliveries, approval rejection, and partial completion. Score intermediate evidence and tool actions as well as the final response so a fluent but unsafe run cannot pass unnoticed.
