An AI data center is a computing facility engineered for the extreme parallel processing, data movement, electrical demand, and heat removal required by modern machine-learning models. It is not simply a room full of faster servers. Accelerator nodes, CPUs, memory, several network fabrics, tiered storage, power distribution, backup, cooling, and control software must be designed as one operating system. The result may contain a few racks for inference or thousands of accelerators for training; there is no single standard size.

What makes a data center an AI data center?

Traditional data centers are commonly optimized for varied business applications: databases, web services, virtual machines, and file workloads. AI facilities are optimized around a different bottleneck. Training repeatedly exchanges model parameters, activations, and gradients among accelerators, while inference must deliver predictable responses at high concurrency. A GPU that is waiting for data, a network link that is congested, or a storage system that cannot feed the next batch leaves expensive compute idle.

The building is therefore only one layer. An AI facility combines:

  • Accelerator servers with GPUs or other AI processors, host CPUs, memory, local NVMe, and high-speed network interfaces.
  • Separate fabrics for users, management, cluster communication, and in-rack accelerator links.
  • Local, block, file, and object storage selected by access pattern and durability needs.
  • High-capacity electrical service, conversion, distribution, monitoring, and backup.
  • Air, rear-door, or liquid-cooling systems sized for sustained rack heat.
  • Schedulers, orchestration, telemetry, security controls, and software that understands facility limits.

That integrated design is what distinguishes an AI data center from a conventional server room with a few graphics cards installed.

How the compute nodes work

Accelerators perform the parallel work

Modern model training and inference are dominated by matrix multiplication, tensor operations, and other highly parallel calculations. GPUs and comparable accelerators execute many of these operations simultaneously. A compute node combines the accelerators with host CPUs, system memory, local storage, power supplies, and network adapters. The CPU prepares work, handles operating-system and orchestration duties, and coordinates input and output; the accelerator performs the dense numerical kernels.

Memory is as important as processor count

Model weights, activations, optimizer state, and input batches must fit in accelerator memory or move through it efficiently. NVIDIA’s current reference design lists four B200 GPUs with 720 GB of aggregate HBM3 in a GB200 tray, alongside Grace CPUs and NVMe drives. That is a vendor-specific example, not a universal specification: other accelerator generations and vendors have different memory capacities, interconnects, and host balances.

How many GPUs are in an AI data center?

There is no defensible “typical” count. A small inference cluster may use a handful of accelerators; a training installation may scale to many racks. The practical limit is set by available power, cooling, network topology, floor space, budget, and the model’s parallelism strategy. Counting GPUs without specifying their memory, interconnect, and sustained power says little about useful capacity.

Networking: scale up inside a rack and scale out across racks

AI facilities use more than the ordinary user or “north-south” network. NVIDIA’s reference architecture separates four functions:

Fabric Purpose Typical traffic
Tenant-access network (TAN) Connects users and applications to the cluster API calls, job submission, service traffic, and results
Secure-management network (SMN) Provides isolated administrative access Provisioning, monitoring, firmware, and control-plane operations
Cluster-interconnect network (CIN) Moves data between nodes during distributed jobs Parameters, activations, gradients, and collective operations
NVLink Provides scale-up communication inside a rack or accelerator system High-bandwidth GPU-to-GPU transfers

In NVIDIA’s documentation, TAN and SMN are always Ethernet; CIN can use Ethernet or InfiniBand; NVLink is a proprietary NVIDIA standard. The right choice depends on latency, congestion control, software support, cabling distance, and operational skills rather than on a single headline bandwidth figure.

A concrete rack-scale example

Microsoft describes one current Azure design with 72 NVIDIA Blackwell GPUs in a rack, 1.8 terabytes of GPU-to-GPU bandwidth, and 14 terabytes of pooled memory. Across racks, that system uses 800-Gbps InfiniBand and Ethernet fabrics in a non-blocking fat-tree topology. These are characteristics of that Azure implementation, not a requirement for every AI facility. A different accelerator, topology, or workload may use another arrangement.

Why topology matters

Distributed training creates synchronized communication bursts. A blocking design can force traffic through oversubscribed links, causing stragglers while faster workers wait. Designers therefore examine bisection bandwidth, radix, hop count, optical or copper reach, congestion control, failure domains, and the software’s collective-communication patterns. Scale-up links handle very short, very high-bandwidth paths; scale-out fabrics connect racks and must also provide routing, isolation, and fault recovery.

Storage is a set of tiers, not one appliance

AI data pipelines read training examples repeatedly, write checkpoints, cache container images, and emit logs. No single medium is ideal for all of those jobs. A reference design commonly assigns roles as follows:

Tier Best fit Important design question
Local NVMe Boot data, Kubernetes image caches, scratch space, and ephemeral logs How much temporary capacity and per-node throughput are needed?
Remote block storage Persistent volumes for services and applications What latency, IOPS, and failure behavior does each volume require?
Shared file storage High-throughput datasets used concurrently by many workers Can aggregate bandwidth keep every accelerator supplied?
Object storage Durable, very large datasets, archives, and checkpoints How will retention, replication, and restore time be managed?

Capacity and throughput must be sized together. NVIDIA notes that required bandwidth per GPU varies with the workload, model, and target performance. A cluster with ample terabytes but insufficient read bandwidth still starves its accelerators; a fast system with no durable checkpoint policy risks losing long training runs.

Why AI racks need so much power

Accelerators concentrate electrical load in a small footprint. Planning must include utility service, transformers and conversion stages, power shelves, busways or distribution units, backup systems, rack-level monitoring, and workload power management. Electrical and mechanical designs cannot be separated: the heat produced by every consumed watt must be removed continuously.

An illustrative rack calculation

Harvard Edge gives an example using 32 GPUs rated at 700 watts each. The GPUs alone draw 22.4 kW (32 × 700 W). After CPUs, switches, conversion losses, and cooling overhead, the illustrative total reaches 33–40 kW per rack. This is an example, not a universal rack rating; actual values depend on accelerator model, utilization, power limits, and facility equipment.

Backup strategy also changes the design. Short interruptions may be covered by UPS systems, while generators and fuel systems support longer outages. Operators may reserve capacity for startup surges, maintenance, or future rack additions instead of running the electrical plant at its absolute limit.

Cooling: from contained air to liquid loops

Every watt consumed becomes heat. Conventional air cooling with hot-aisle containment can work at lower rack densities, but moving enough air through dense accelerator systems increases fan power, airflow requirements, and mechanical-plant size. Higher-density deployments increasingly use rear-door heat exchangers or direct-to-chip liquid cooling.

How liquid cooling works

A coolant distribution unit circulates liquid to cold plates attached directly to processors, or to a heat exchanger mounted at the rack’s rear. Pumps, heat exchangers, valves, sensors, leak detection, and service clearances become part of the rack design. The facility’s water chemistry, ambient conditions, maintenance procedures, and allowable coolant temperature determine the exact implementation.

NVIDIA’s DSX material describes operation with liquid at 45 °C and treats cooling as part of the same validated design as compute, networking, and power. That temperature is a design example, not a universal set point. Some sites combine liquid cooling for the hottest components with air cooling for memory, storage, and power electronics.

Why there is no universal cooling percentage

The share of facility electricity used for cooling varies with rack density, climate, mechanical plant, workload, and the measurement boundary. A site with mild outdoor conditions and efficient heat rejection will differ from a hot-climate facility with extensive pumping or chilled-water equipment. It is more accurate to report the assumptions and measured boundary than to quote one percentage for all AI data centers.

How the subsystems interact during a job

  1. Input preparation: data is read from object or file storage, transformed, and staged in local NVMe or host memory.
  2. Accelerator execution: GPUs process a batch using HBM and exchange intermediate data over in-rack links.
  3. Synchronization: distributed workers communicate parameters, activations, or gradients over the cluster-interconnect fabric.
  4. Checkpointing: model state is written to durable storage without overwhelming the training path.
  5. Control and telemetry: schedulers monitor utilization, temperature, power, errors, and network congestion, then place or throttle work accordingly.

If preprocessing or storage cannot keep up, GPUs wait. If the network is congested, synchronized workers stall. If power delivery or cooling cannot sustain the rack, operators must lower density, cap clocks, or move jobs. The useful unit is therefore end-to-end throughput, not isolated accelerator specifications.

AI data center versus a conventional data center

Design concern Conventional emphasis AI-facility emphasis
Compute Many varied CPU workloads and virtual machines Accelerator density, HBM, host balance, and parallel scheduling
Network User access and service-to-service traffic Dedicated low-latency, high-bandwidth east-west fabrics plus scale-up links
Storage Capacity, transactions, and general-purpose file services Streaming bandwidth per accelerator, cache behavior, and checkpoint throughput
Power Moderate, distributed rack loads High sustained rack loads, conversion efficiency, and power caps
Cooling Room air systems sized for lower density Containment, rear-door exchangers, or direct liquid cooling
Operations Server and virtual-machine availability Job scheduling, collective communication, telemetry, and facility-aware placement

A practical sizing process

  1. Characterize the workload. Separate training, fine-tuning, batch inference, and interactive inference. Record model size, batch size, sequence length, target latency, and checkpoint frequency.
  2. Choose the accelerator and memory balance. Verify HBM capacity, host-memory requirements, CPU performance, local NVMe, and supported software.
  3. Design communication paths. Map in-rack scale-up links and cross-rack fabrics; calculate bandwidth, oversubscription, latency, and failure domains.
  4. Size storage by bandwidth and durability. Measure how many gigabytes per second each GPU needs, then plan dataset, cache, checkpoint, replication, and restore behavior.
  5. Calculate sustained and peak power. Include accelerators, CPUs, memory, switches, conversion losses, pumps, fans, and backup margins. Do not use GPU nameplate power as the rack total.
  6. Select the thermal architecture. Compare contained air, rear-door exchangers, and direct-to-chip liquid cooling against rack density, coolant temperature, water availability, service access, and expansion plans.
  7. Validate operations and security. Provide isolated management, identity controls, telemetry, automated provisioning, workload quotas, and procedures for failed links, leaking loops, or degraded storage.

NVIDIA’s enterprise guidance recommends sizing against real constraints in space, power, cooling, network integration, and operations rather than selecting a GPU count in isolation.

Efficiency and workload choices can change the footprint

Hardware efficiency is only part of the result. In one 2024 experiment on an eight-GPU H100 node, increasing the ResNet batch size from 512 to 4096 reduced total training energy by a factor of four. That measured result applies to that model, hardware, and experimental setup; it is not a general law that every larger batch is better. Memory limits, convergence behavior, latency targets, and data quality still constrain batch size.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

A 2023 Google Research paper reported about three-times lower energy and 20-times lower CO2e for TPU v4 compared with contemporary domain-specific accelerators in its comparison. Those figures are paper-specific and depend on the selected workloads, system boundary, and assumptions. They should inform evaluation, not substitute for measurements on the intended application.

Common failure modes and corrective actions

  • GPUs show low utilization: profile input pipelines, storage throughput, CPU preprocessing, and synchronization time before buying more accelerators.
  • Training slows as the cluster grows: inspect cross-rack oversubscription, collective-operation latency, congestion, and topology-aware scheduling.
  • Checkpoints disrupt jobs: separate durable object storage from the hot training path, add local staging, and schedule writes around workload behavior.
  • Racks exceed thermal limits: lower accelerator power caps, reduce density, improve containment or liquid distribution, and verify sensor calibration and coolant flow.
  • Electrical headroom disappears: account for conversion and cooling overhead, reserve capacity for peaks, and enforce rack-level power management.
  • A single failure takes down many workers: divide networks, storage, power, and cooling into failure domains and test recovery procedures instead of relying only on component redundancy.
