What Does a Security Boundary Mean in AI Infrastructure?

A security boundary in AI infrastructure is the defined line around systems, data, services and identities that share a security policy or responsibility. It specifies what is protected, who controls each layer, how access is verified and where trust in a provider, platform or workload begins and ends.

There is rarely one boundary around an entire AI system. A production deployment normally has overlapping boundaries around training and inference data, model artifacts, the workload that executes the model, and the customer–cloud-provider relationship. Treating those boundaries separately makes risks and responsibilities measurable instead of leaving them as assumptions.

What a security boundary actually marks

A boundary is an architectural and governance statement, not merely a box on a network diagram. It identifies the assets, actors, data flows and controls governed by one security policy or accountable party. For an AI system, relevant assets include training, fine-tuning and output data; model weights; prompts and responses; configuration and policy files; source code and dependencies; orchestration software; accelerators; hosts; storage; and management interfaces.

Assets and data inside the line

Write down whether each asset is inside the boundary, outside it, or crossing it. A data boundary might include a training lake, feature store, annotation system and backup copies. A model boundary might include weights, tokenizer files, evaluation sets and deployment configuration. An inference boundary may also include user prompts, generated responses, retrieval indexes and logs. A boundary is incomplete if it protects the model but leaves its secrets in an unclassified build pipeline or observability service.

Actors and identities

List human administrators, data scientists, application users, CI/CD jobs, model-serving processes, retrieval services, plug-ins and cloud control-plane identities. Each actor needs an authentication method and an authorization decision. A service account that can read model weights is part of the threat surface even if no human can log in with it.

Flows and control points

Map data entering, leaving and moving within the boundary: uploads, training jobs, checkpoints, inference requests, tool calls, telemetry, backups and support access. Mark where encryption, policy evaluation, approval, filtering, key use and audit logging occur. The result should show not only a perimeter, but the decisions made at every crossing.

Why AI deployments have several interacting boundaries

Data and model boundary

This boundary covers information used to train or retrieve from a model and the resulting artifacts. Questions include whether customer data can be used for further training, who can export weights, how evaluation data is separated from training data, and whether prompts and responses are retained. Integrity matters as much as confidentiality: poisoned data, altered weights or changed policy files can produce unsafe outputs without exposing a secret.

Workload and runtime boundary

The runtime boundary surrounds the processes, containers, virtual machines, accelerators, host operating system and orchestration controls that execute training or inference. It should distinguish a model-serving workload from neighboring workloads, administrative tooling and untrusted plug-ins. Runtime permissions should be narrow enough that a model process cannot automatically read unrelated disks, invoke arbitrary cloud APIs or inspect another tenant’s memory.

Provider and customer boundary

In a hosted environment, some controls are operated by the customer and others by a cloud or AI service provider. The exact line depends on the service model and contract. A provider may operate facilities, physical hosts, a hypervisor and managed control planes, while the customer configures identities, data, applications and model policies. Managed services can move operational work across the line without eliminating the customer’s accountability for data use and access decisions.

A boundary is not the same as a firewall or subnet

Network segmentation can reduce reachability, but it does not by itself establish trust. NIST’s zero-trust guidance rejects implicit trust based solely on network location or ownership. In A Zero Trust Architecture Model for Access Control in Cloud-Native Applications in Multi-Cloud Environments (SP 800-207A, September 13, 2023), NIST states: “A key paradigm shift in ZTAs is the change in focus from security controls based on segmentation and isolation using network parameters (e.g., IP addresses, subnets, perimeter) to identities.”

Apply that principle to AI services by authenticating and authorizing users, applications and workloads for each sensitive action. A request from an approved subnet should still be checked before it reads a dataset, loads weights, calls a tool or exports a response. Conversely, a service may be allowed to access a specific model registry through an identity policy even when it runs in a different network segment.

Isolation techniques and the trust they leave

Isolation is one layer of a boundary, not a guarantee that a system is risk-free. NIST IR 8320 discusses techniques for isolating virtual machines, applications and data during execution, including multi-tenant environments. Each technique has different performance, operational and trust assumptions.

Isolation layer What it separates Residual trust assumptions Typical questions
Network Routes, subnets, security groups and service endpoints Identity, host, control-plane and administrator controls still matter Can a compromised service reach metadata, storage or another tenant?
Application or process API handlers, sandboxes, plug-ins and worker processes Kernel, runtime, dependencies and privileged services remain trusted Can an extension escape its sandbox or access secrets through a shared process?
Virtual machine Guest operating systems and their virtual devices Hypervisor, firmware, host administrators and hardware are trusted What happens if a guest or hypervisor vulnerability is exploited?
Hardware-assisted Protected memory or execution domains supported by hardware Processor design, firmware, attestation, key management and side-channel resistance remain relevant Who verifies the measured workload and controls release of decryption keys?

“Isolated” should therefore be accompanied by a statement of what is isolated, from whom, by which mechanism and under which failure assumptions. Confidential or hardware-assisted execution can reduce exposure to some host administrators or co-tenants, but it does not prevent every attack, misconfiguration, malicious workload or data-use violation.

How to define a boundary for an AI workload

  1. State the protection objective. Decide whether the primary concern is confidentiality of customer data, integrity of model behavior, availability of inference, regulatory separation, or a combination. The objective determines which assets and events must be covered.
  2. Inventory assets and trust zones. List data stores, model registries, training jobs, serving endpoints, accelerators, orchestration systems, secrets, logs, backups and support tools. Assign each to a zone such as customer-controlled, provider-controlled, shared or untrusted.
  3. Map identities and actions. Record who or what can read, write, execute, administer, export or delete each asset. Use separate identities for people, pipelines, model servers and automation; avoid shared administrator credentials.
  4. Draw every crossing. Include data ingestion, model promotion, inference, retrieval, tool calls, telemetry, backups and support access. For each crossing, specify authentication, authorization, encryption, validation, rate limits and logging.
  5. Choose an isolation mechanism. Select network, process, virtual-machine or hardware-assisted isolation according to the threat and performance requirements. Document which layer is trusted and what happens if it fails.
  6. Assign responsibility. For every control, name the operator, evidence produced and escalation path. A provider-managed host does not make the customer-managed identity policy optional.
  7. Test and revise. Review access logs, configuration drift, model and data provenance, failed authorization attempts, backup paths and incident procedures. Update the boundary when a new tool, model, region, tenant or managed service is introduced.

Comparing common AI infrastructure designs

Design Assets inside the customer boundary Main operator split Important remaining trust
Self-managed cluster Usually the hosts, network, storage, orchestration, data and models Customer operates nearly every layer Hardware vendors, firmware, administrators and supply chain
Managed virtual machines Guest configuration, applications, data, identities and model artifacts Provider operates facilities, hardware and hypervisor; customer operates guests and workloads Hypervisor, host administrators, control plane and hardware
Managed model or inference API Customer application, credentials, submitted data and contractual policy controls Provider operates serving stack and much of the runtime; customer governs use, identity and data decisions Provider’s service isolation, retention, subprocessors and administrative access
Confidential or hardware-protected workload Defined code, data and keys released after an attestation decision Customer controls policy and keys; provider supplies protected execution infrastructure Hardware, firmware, attestation service, key release logic and side-channel exposure

These are architectural patterns, not guarantees. Contracts, service editions and deployment settings can move a particular control from one party to another. Obtain a provider’s responsibility statement and verify it against the actual configuration.

Shared responsibility in cloud AI

NIST’s cloud architecture guidance describes internal and external infrastructure-as-a-service boundaries as lines of management control and provider–consumer relationship. Establishing trust requires coordination: the parties must agree who configures, monitors, patches and responds at each layer.

  • Facility and physical hardware: establish who protects sites, hardware, disposal processes and physical access.
  • Virtualization and host layer: identify the operator of hypervisors, host operating systems, firmware and isolation updates.
  • Platform and control plane: clarify who secures orchestration, registries, metadata services, API endpoints and administrative roles.
  • Workload and data: assign responsibility for application code, model files, datasets, secrets, retention, deletion and export.
  • Detection and response: define which logs are available, how quickly they are delivered, who investigates provider-side events and how evidence is preserved.

If a service does not state a layer’s owner, treat that as an unresolved boundary rather than assuming the provider covers it.

Using zero trust and AI risk frameworks together

Zero trust supplies access and architecture principles: verify explicitly, grant least privilege and evaluate requests using identity and context rather than location alone. NIST SP 800-207 describes this as avoiding implicit trust based solely on network position or ownership.

NIST’s AI Risk Management Framework (AI RMF) is voluntary guidance for managing AI risks and trustworthiness across design, development, use and evaluation. Its current page records that version 1.0 is being revised and includes an April 7, 2026 concept note for a critical-infrastructure profile; those status details may change.

NIST’s Control Overlays for Securing AI Systems (COSAiS) are also voluntary. The COSAiS FAQ explains that AI security is closely intertwined with the IT infrastructure on which AI systems run and that the AI RMF and general NIST Risk Management Framework can be used concurrently. An overlay is a starting point for selecting controls, not a certification or mandatory checklist.

Common boundary failures and how to correct them

“The private subnet is the boundary”

Symptom: services inside the subnet can read each other’s secrets or call broad cloud APIs. Correction: add workload identities, per-action authorization, egress controls and audit trails.

“The provider secures everything”

Symptom: customer data is retained, exposed through logs or accessible by an overprivileged role because ownership was never documented. Correction: obtain a layer-by-layer responsibility matrix, configure retention and keys, and review provider access and incident terms.

“Isolation means compromise is impossible”

Symptom: a VM, sandbox or confidential workload is treated as proof that data cannot escape. Correction: document the isolation mechanism’s assumptions, patch and attest it, restrict key release, and plan for host, hypervisor, firmware and side-channel failures.

“The model is the only sensitive component”

Symptom: weights are protected while prompts, retrieval indexes, checkpoints or deployment policies remain broadly accessible. Correction: classify all data and artifacts, then apply the same boundary analysis to pipelines, logs and backups.

What a useful boundary review should produce

A review is complete when another engineer can answer five questions without guessing:

  • Which data, model artifacts, services and identities are inside each boundary?
  • Where does each request cross a boundary, and what decision authorizes it?
  • Who operates and is accountable for every layer, including provider-managed components?
  • What isolation mechanism is used, and which provider, hypervisor, hardware or administrator assumptions remain?
  • What evidence proves the controls work, and how are drift and incidents handled?

That documentation turns “secure AI infrastructure” from a broad aspiration into a set of testable control and responsibility statements.

The Bottom Line

A security boundary in AI infrastructure is the explicit combination of scope, trust, identity, control and accountability. Define separate boundaries for data and models, runtimes and provider layers; enforce them with identity-aware policies and appropriate isolation; and document the assumptions that remain outside your control.
