Physics-informed AI (PIAI) embeds semiconductor equations, boundary conditions or conservation laws in model training. Data-driven AI learns relationships mainly from examples. Use PIAI when the governing physics is trusted but labelled data are scarce, expensive, noisy or likely to be exceeded; use a data-driven surrogate when representative simulation or measurement data are abundant and rapid repeated prediction is the priority. In most engineering flows, a hybrid—keeping a TCAD, circuit or process-physics core and learning a surrogate or correction—offers the most practical balance.
Neither approach is automatically accurate enough for signoff. The right choice depends on the task, equation quality, data coverage, allowable error, latency target and independent verification plan.

What the two approaches mean in semiconductor work
Physics-informed AI
A physics-informed model is a machine-learning model whose objective includes the laws that describe the device or process. A physics-informed neural network (PINN), for example, can be trained not only against measured or simulated values but also against the residual of governing equations at points in space and time.

total loss = data loss + λphysics × physics-residual loss + λboundary × boundary-condition loss
The network is penalised when its predicted potential, carrier concentrations or currents fail to satisfy the equations, boundary conditions or conservation constraints. The weights determine how strongly each requirement influences optimisation. A PINN can therefore use sparse measurements or boundary values while learning a physically consistent field between them.
Physics-informed does not mean that a model contains every detail of a commercial simulator. Results are only as reliable as the equations, material parameters, boundary conditions, numerical formulation and training procedure supplied to it. Missing effects—such as a process-specific defect mechanism—are not magically recovered by calling a model physics-informed.
Data-driven AI
A data-driven model receives examples such as device curves, process simulations, layout features, circuit netlists, timing reports or measured yields and learns a mapping from inputs to outputs. A neural-network surrogate for TCAD might learn drain current from bias, geometry, doping and temperature. A placement model might learn an action or ranking from a circuit representation and floorplan state.
Its governing constraint is the distribution of its training data. If the examples cover the intended geometry, process corner, voltage, temperature and operating regime, inference can be very fast and useful for design-space exploration. If deployment moves outside that distribution, prediction quality can deteriorate without an obvious warning unless uncertainty estimation or out-of-distribution checks are added.
Why the distinction matters
Both approaches can use neural networks, the same optimisers and the same accelerator hardware. The difference is what makes an output acceptable during training: a data-driven model is judged mainly against examples, while a physics-informed model is additionally judged against known physical relationships. Hybrid models combine both sources of information.
Side-by-side comparison
| Decision factor | Physics-informed AI / PINN | Data-driven AI | Engineering implication |
|---|---|---|---|
| Primary information | Equations, boundary or initial conditions, material and process parameters, plus any available data | Measured or simulated examples and their labels | Choose PIAI when equations are reliable and labels are costly; choose data-driven learning when representative labels are plentiful. |
| Labelled-data requirement | Can reduce dependence on dense labels by enforcing residuals and boundaries | Usually needs broad, representative coverage of the deployment region | Sparse data favour PIAI, but sparse or incorrect physics can still produce a poor model. |
| Physical constraints | Built into the loss or architecture | Must be learned from examples or imposed after training | PIAI can discourage non-conserving solutions; data-driven models need validation and guardrails. |
| Extrapolation | May behave more plausibly where the equations remain valid, but can fail when the physics or parameters are incomplete | Usually weak outside the training distribution | Neither approach should be trusted outside validated regimes without uncertainty and fallback checks. |
| Training cost | Residual and boundary evaluation can be computationally intensive and may make optimisation difficult | Training cost depends on dataset size and architecture; data preparation can dominate | Budget for equation evaluation, automatic differentiation and repeated solver calls in PIAI. |
| Inference cost | Often much lower than solving the original equations once trained, but not guaranteed | Usually low and predictable for a fixed model | Both can accelerate repeated sweeps; report measured speedups for the exact workload. |
| Interpretability | Assumptions are visible in equations, parameters and residuals | Feature influence and failure modes may be harder to explain | PIAI offers an audit trail of constraints, while data-driven systems need stronger monitoring. |
| Maintenance | Requires updating physics, parameters or boundary treatment when the process changes | Requires new data when topology, process or operating conditions shift | Pick the maintenance path your team can automate and verify. |
| Signoff status | Research-stage for many semiconductor applications | Useful for exploration and acceleration, but also requires independent checks | Keep a qualified conventional solver or signoff flow for final acceptance. |
How a PINN changes a semiconductor simulation
Drift-diffusion example
In a drift-diffusion device model, the unknowns can include electrostatic potential and electron and hole concentrations. Poisson’s equation links charge density to potential; continuity equations enforce carrier conservation; constitutive relations describe drift and diffusion currents. A PINN represents the unknown fields with a neural network and samples collocation points throughout the device domain.
- Define the domain and variables. Specify device geometry, contacts, interfaces, bias, temperature and the fields the network will predict.
- Encode the equations. Use automatic differentiation to calculate spatial and temporal derivatives needed for Poisson and continuity residuals.
- Add boundary and initial conditions. Contact potentials, carrier concentrations, interface conditions and starting states become explicit loss terms.
- Add trusted observations. Measured or conventional-solver values can anchor the network where data exist.
- Train and inspect residuals. Optimisation should reduce data error and equation residuals; inspect each term rather than relying on one aggregate loss.
- Validate against an independent solution. Compare fields and terminal quantities over bias, geometry and temperature ranges that were not used for fitting.
A 2023 IEEE ACES-China paper describes a surrogate for a coupled drift-diffusion model using an artificial neural network, backpropagation for error computation and Adam for parameter updates. That formulation illustrates the central idea: the network is not merely fitting a current-voltage table; the coupled equations contribute to training.

Dopant-diffusion and process examples
For dopant diffusion, a physics-informed model can enforce the diffusion equation and boundary or initial profiles while estimating unknown physical parameters. This is valuable when only a few concentration measurements are available or when running a dense process simulation for every parameter candidate is expensive.
Process models still require careful treatment of moving interfaces, temperature-dependent coefficients, implantation profiles and reactions. If those effects are omitted, a low residual can coexist with an inaccurate process prediction.
Where data-driven surrogates are strongest
Repeated TCAD sweeps
Suppose a team must evaluate thousands of combinations of gate length, oxide thickness, doping, bias and temperature. Running a calibrated TCAD solver for every point may be too slow for optimisation. A supervised surrogate can learn the mapping from those inputs to currents, capacitances, breakdown indicators or other outputs, then return predictions quickly during exploration.
The critical preparation step is coverage. The training set should span every geometry, process corner and operating range that the optimiser may visit. Randomly holding out points from the same narrow region can make validation look excellent while hiding failures at corners.
Design-space exploration and optimisation
Data-driven models are particularly effective when an optimiser needs millions of inexpensive objective evaluations. A 2026 computing-in-memory study combined EDA tools, machine learning and surrogate-assisted multi-objective optimisation. In that study’s setup, mean off-grid normalised errors were below 5% across four objectives. This is a result for that experiment—not a general industry benchmark—and it does not establish that every surrogate will meet a 5% target.
Use the surrogate to rank candidates, then rerun the best and riskiest candidates through the trusted simulator. Active learning can add new high-value points where uncertainty is high, objectives conflict or the optimiser approaches a boundary.
Placement and physical design
Chip placement models can optimise proxy objectives such as wirelength, congestion or estimated timing. However, a proxy can improve while final power, performance and area (PPA) worsen. ChiPBench evaluated 20 CPU, GPU and microcontroller circuits and six state-of-the-art AI-based placement algorithms. Its central lesson is methodological: evaluate the end-to-end engineering objective, not only the intermediate score used during search.
For a placement system, that means checking routed timing, congestion, power, area, design-rule outcomes and the effort required to complete the flow. A model that wins a learned reward but causes routing failure is not an engineering win.

Device and process simulation versus circuit and physical design
Device and process simulation
Device and process tasks expose comparatively explicit physics. Governing differential equations, conservation laws and material parameters can be written down, making PIAI attractive when measurements are sparse. The output may be a field, concentration profile, terminal curve or extracted parameter.
Validation should compare more than a single scalar. Check spatial fields, terminal currents, charge conservation, transient response, temperature dependence and behaviour at process corners. A model can match drain current while violating an internal field or producing an implausible carrier distribution.
Circuit design
Circuit-level AI often operates on netlists, waveforms, sizing variables or simulator reports. The available physics may be embedded in the circuit simulator rather than expressed directly in the learning model. A data-driven surrogate can be effective for repeated sizing or corner evaluation, while a hybrid can retain the simulator for final candidates and learn a correction for systematic error.

1Clear out junk files and repair common Windows errors2Scan for outdated or missing drivers - takes under a minute3Repair Windows errors before they cause bigger problemsFor analogue and mixed-signal work, the target may include gain, bandwidth, noise, linearity, settling, yield and reliability simultaneously. A low regression loss on nominal samples is not evidence that all corners or rare failures are covered.
Physical design and manufacturing
Placement, routing, mask synthesis and process control involve discrete choices, massive combinatorial spaces and hard manufacturing constraints. Physics-informed generative or differentiable-simulation methods can help impose constraints on masks, layouts, defect patterns or process recipes. Data-driven models remain useful for ranking and search, provided the generated candidates pass design-rule, lithography, timing, power and reliability checks.
Manufacturing data also introduce confidentiality, class imbalance and drift. Defect labels can be rare, process recipes can change, and a model trained on one tool or fab condition may not transfer. Physics-based constraints can reduce implausible outputs, but they do not remove the need for lot-level monitoring and qualification.
Can physics-informed AI reduce simulation time?
It can, after training, when the learned representation replaces repeated solves for a defined range of inputs. The potential benefit comes from cheap inference during sweeps or optimisation, not from eliminating the cost of constructing and validating the model. Training may require many residual evaluations, automatic-differentiation operations and, in hybrid schemes, calls to a conventional solver.

Do not claim a universal speedup. Measure wall-clock time for the complete workflow: data generation, training, hyperparameter searches, inference, uncertainty checks, simulator confirmation and retraining. Compare against the actual baseline, including parallelism and licensing constraints. A model that is faster per prediction but expensive to retrain after every process change may lose its advantage over a reusable surrogate.

Accuracy, uncertainty and signoff
What “accurate enough” means
Set an error budget from the engineering decision, not from a generic machine-learning metric. Examples include maximum current error at specified biases, transient settling-time error, timing slack margin, power and area tolerances, yield confidence or a permitted defect-rate increase. Report errors by operating corner and by failure severity; average error can hide catastrophic misses.
Use independent verification
- Hold out entire geometries, topologies, process corners or temperature ranges, not only random points.
- Compare predictions with a qualified TCAD, circuit or physical-design flow on candidates selected by the AI, including uncertain and boundary cases.
- Check conservation, boundary conditions, monotonic relationships and known limiting behaviour.
- Track uncertainty or disagreement between ensembles, surrogate and solver, or model and correction term.
- Define an automatic fallback when confidence is low or a hard constraint is violated.
Why signoff remains separate
A 2026 survey of mixed-signal design methods classifies classical approaches as the only signoff-accurate methods in its comparison. It places PINNs and large-language-model-based design tools at research-stage maturity, while Bayesian optimisation has greater industrial validation. The practical interpretation is not that AI has no production value; it is that acceleration, exploration and recommendation should be separated from the final qualified analysis.
Keep the conventional signoff solver, extraction, rule checking and review path authoritative unless your organisation has separately qualified an AI component for a narrowly defined use. Document model version, training data, process assumptions, uncertainty thresholds and the exact cases sent to the fallback flow.
Why hybrid architectures are usually the engineering default
Surrogate around a trusted solver
Use TCAD, SPICE, field solvers or process simulators to generate a calibrated data set, then train a fast surrogate for exploration. The original solver remains the arbiter for selected designs. This arrangement gives data-driven speed without asking the neural network to replace the physics everywhere.
Physics residual plus data correction
Start with a physics model and train a network to represent an unresolved correction—such as a systematic discrepancy caused by a simplified mobility, compact-model or process assumption. The correction can be constrained by dimensions, symmetries or conservation laws and checked against new measurements.
Residual learning and active sampling
Train on the difference between a baseline solver and high-fidelity data. Then sample new points where the residual is large, uncertainty rises or the optimiser proposes an unfamiliar design. This focuses expensive simulations on information that changes a decision rather than filling the domain uniformly.
Multi-fidelity cascades
Use a fast low-fidelity model for broad screening, a learned surrogate for refinement and a high-fidelity solver for final candidates. Store every accepted solver result so the model can be updated as the process, library or design style evolves.

- Define the decision. State whether the model will screen devices, estimate a circuit metric, guide placement, optimise a process or support signoff. List the output and its allowable error.
- Map available physics. Record which equations, boundary conditions, material parameters and invariants are trusted over the intended range. Mark effects that are empirical, proprietary or unknown.
- Audit the data. Measure coverage by topology, geometry, process corner, voltage, temperature, workload and failure class. Identify leakage between training and test sets.
- Choose the least risky architecture. Use a data-driven surrogate for well-covered repeated prediction; a PINN for sparse-data problems with strong equations; or a hybrid when both sources are valuable.
- Design the validation split before training. Reserve unseen corners, devices, circuits or process conditions that represent actual deployment risk.
- Set hard gates. Include residual thresholds, design rules, conservation checks, uncertainty limits and a conventional-solver fallback.
- Benchmark the whole objective. Measure final device, circuit, PPA, timing, power, yield or reliability outcomes, plus runtime and compute cost. Do not optimise only a convenient proxy.
- Qualify change management. Decide when a process revision, new IP block, simulator version or new operating range forces retraining and requalification.
Common failure modes and fixes
“The loss is low, so the device is correct”
A weighted loss can hide a large boundary or conservation error. Plot each loss component, inspect physical fields and test terminal quantities against an independent solver.
Best Value
“The PINN will extrapolate everywhere”
Equation constraints help only where the equations and parameters remain valid. Add domain checks, uncertainty estimates and a fallback outside the qualified range.
“More data will solve every problem”
More examples cannot repair biased labels, missing corners or a simulator that omits a relevant mechanism. Fix the data-generation design and inspect residual structure before scaling the dataset.
“A placement proxy proves PPA”
Run complete implementation and signoff-oriented checks. The ChiPBench experience with 20 circuits and six AI placement algorithms demonstrates why an attractive intermediate metric can still lead to unsatisfactory final PPA.
Recommended Free Tools
“Inference speed is the same as project speed”
Include data generation, training, tuning, verification, storage, deployment and retraining in the cost model. Measure the workflow your team will actually operate.
“One model can cover every process and topology”
Process-specific and topology-specific behaviour often dominates. Partition models by regime when necessary, expose the regime as an input, and reject requests outside validated coverage.
Decision checklist for a semiconductor design team
- Equation quality: Are the governing equations and boundary conditions known, calibrated and valid in the proposed operating range?
- Data coverage: Do examples represent every geometry, topology, corner and failure mode the optimiser may explore?
- Latency: Is the bottleneck one expensive solve, or millions of repeated evaluations?
- Error budget: What maximum error changes the design decision, and how will it be measured?
- Uncertainty: Can the system identify out-of-distribution inputs and trigger a trusted fallback?
- Objective: Will evaluation use final device, circuit, PPA, timing, power, yield or reliability outcomes rather than a proxy alone?
- Signoff path: Which conventional tools and reviews remain mandatory, and what evidence would be required to qualify an AI component?
- Maintenance: Who owns retraining, process-change detection, model versioning and revalidation?
Teams looking for implementation options can evaluate categories of EDA and TCAD simulation software alongside their existing solvers, data pipelines and verification infrastructure. Product capabilities and qualification status vary by vendor, release and application, so assess them against the checklist rather than assuming that an “AI” label implies signoff readiness.
Bottom line for design decisions
Choose physics-informed AI when reliable equations and limited data are the defining conditions. Choose data-driven AI when broad, representative data and high-volume prediction dominate the economics. Choose a hybrid when you need speed but cannot surrender a trusted physical or signoff core. In every case, validate the final engineering outcome on unseen cases and keep conventional simulation in the loop until the AI component has been independently qualified for its exact use.
