Use ordinal encoding only when category order is meaningful and explicitly defined. Use one-hot encoding for nominal categories such as color, product type, or browser, where assigning integers would create a false ranking. The right choice also depends on feature cardinality, estimator behavior, sparsity, and how your pipeline will handle missing or previously unseen values.
What the two encodings mean
Ordinal encoding preserves an intentional order
Ordinal encoding stores each categorical feature in one integer-valued column. For example, a satisfaction feature can be mapped explicitly as disappointed = 0, neutral = 1, satisfied = 2. The numbers are useful because the categories have a real sequence; they are not merely labels.

Define or verify the mapping yourself. If a library assigns codes alphabetically or according to the order it encounters values, the resulting integers may not represent the domain’s ranking. An arbitrary code is not ordinal simply because it is numeric.

One-hot encoding creates one binary indicator column for each category. A product-type feature with book, game, and film becomes three columns; each row has a 1 in the matching column and 0 in the others. This follows scikit-learn’s definition: “Encode categorical features as a one-hot numeric array.”

Because the indicators do not imply distance or order, one-hot encoding is the safer representation for nominal data. Its output can be sparse, which avoids storing large numbers of explicit zeroes when most rows belong to only a few categories.
Ordinal or one-hot? A decision framework
| Question | Ordinal encoding | One-hot encoding |
|---|---|---|
| Do categories have a genuine rank? | Appropriate when the order is real and documented. | Usually preferable when categories are nominal. |
| Output width | One column per feature. | One indicator column per retained category, so width grows with cardinality. |
| Numeric distance implied? | Yes; the estimator can treat higher codes as larger values. | No; categories are represented independently. |
| Typical storage | Dense numeric column. | Often sparse; scikit-learn’s current stable API defaults to sparse output. |
| Main risk | An arbitrary mapping can manufacture a false ranking. | Many categories can produce a very wide matrix. |
| Best first question | Can subject-matter experts defend the exact order? | Would integer labels mislead the model about similarity or distance? |
When ordinal encoding is the better choice
Ordered education, size, or rating bands
Use ordinal encoding for categories such as education level, clothing size, service tier, or a clearly ordered rating scale, provided the order is part of the feature’s meaning. Write the mapping explicitly and keep it under version control so training and production use the same semantics.
Unequal spacing needs extra care
Integer codes preserve sequence, not necessarily the distance between levels. If “basic,” “standard,” and “premium” are ordered but the jump from standard to premium has a different meaning from the jump from basic to standard, a plain ordinal column may still be an imperfect numeric approximation. Consider a model that can learn nonlinear effects, separate indicators, or a domain-specific numeric measurement instead of assuming equal intervals.
Unknown and missing categories
Scikit-learn’s OrdinalEncoder provides options for unknown and missing values. Configure those behaviors deliberately; do not let an unknown production value silently acquire a meaningful rank. A dedicated code can be useful, but it must be treated as a sentinel rather than as “higher” or “lower” than known categories.

When one-hot encoding is the better choice
Nominal features
Use one-hot encoding for color, country code, product type, browser, department, or any other feature whose labels have no defensible order. Encoding red, green, and blue as 0, 1, and 2 would allow a model to infer relationships that the data does not state.
Linear and distance-sensitive models
One-hot features are often a strong default for linear models and methods that use distances or dot products, because each category receives its own coefficient or coordinate rather than being placed on an artificial numeric axis. Tree-based models can sometimes work with integer-coded categories, but the code still needs careful treatment: a tree may split on numeric thresholds that have no domain meaning.
High-cardinality features
A feature with thousands of distinct values can create thousands of indicator columns. Scikit-learn’s preprocessing guide identifies target encoding as an alternative for high-cardinality features. Target encoding introduces leakage and overfitting risks, so it requires out-of-fold or otherwise carefully isolated fitting, smoothing, and a clear policy for unseen values. Hashing, frequency features, grouped categories, or a domain-specific reduction may also be appropriate; the choice depends on the estimator and the feature’s semantics.

Handling unknown, missing, and rare values
Unseen categories at prediction time
Fit the encoder on training data, then reuse that fitted object for validation, testing, and production. Scikit-learn’s OneHotEncoder documents these handle_unknown behaviors:
error: raise an error when a transform call contains a category not observed during fitting.ignore: emit zeros for the unknown feature’s indicator columns.infrequent_if_exist: route unknown values to an infrequent bucket when that bucket exists and the relevant configuration is enabled.warn: warn and then use the infrequent-category behavior where available.
Choose the policy based on operational risk. Failing fast is useful when new values signal a data-contract problem; an all-zero or infrequent bucket can keep a serving system running but should be monitored.
Missing values are a modeling decision
Missing does not always mean an ordinary category. It may mean “not collected,” “not applicable,” or an unknown measurement. Decide whether to impute it before encoding or preserve it as an explicit level.
With pandas, get_dummies represents missing values as all zeros by default. Passing dummy_na=True adds a separate missing-indicator column. That distinction matters: all-zero rows can be indistinguishable from a reference pattern, while an explicit indicator lets the estimator learn a missingness effect.
Rare categories
Rare levels can make a one-hot matrix wide and unstable. Grouping genuinely interchangeable rare labels, using an infrequent bucket, or selecting a different representation can reduce this problem. Do not merge categories merely to save columns when their business meanings differ.
Rank #4
Dropping one indicator column
For a feature with k categories, keeping all k one-hot columns gives a linearly dependent set when an intercept is included. Both pandas and scikit-learn support dropping a level. In pandas, drop_first=True emits k−1 indicators.
Scikit-learn documents dropping a level as useful for perfect collinearity in unregularized linear regression. It also cautions that dropping breaks the symmetry between categories and can introduce bias in some penalized models. Therefore, do not drop a column automatically: decide according to the estimator, regularization, interpretability needs, and whether the model implementation already handles collinearity.

Scikit-learn: fit once, transform consistently
The encoder’s fitted category set defines the output layout. Fit it only on training data and apply the same fitted object to every later split and serving request.
from sklearn.preprocessing import OneHotEncoder, OrdinalEncoder
X_train = [["red", "small"], ["blue", "large"], ["red", "medium"]]
X_test = [["green", "small"]]
one_hot = OneHotEncoder(
handle_unknown="ignore",
sparse_output=True
)
X_train_oh = one_hot.fit_transform(X_train)
X_test_oh = one_hot.transform(X_test)
order = [["small", "medium", "large"]]
ordinal = OrdinalEncoder(
categories=order,
handle_unknown="use_encoded_value",
unknown_value=-1
)
X_train_ord = ordinal.fit_transform([["small"], ["large"], ["medium"]])
X_test_ord = ordinal.transform([["extra-large"]])
The exact parameter names available depend on the installed scikit-learn version. pandas: direct dataframe expansion
pandas.get_dummies is convenient when you want a transformed DataFrame rather than a fitted estimator object.
import pandas as pd
dummies = pd.get_dummies(
df,
columns=["color", "product_type"],
dummy_na=True,
sparse=True,
dtype="int8"
)
When passed a DataFrame, it converts object, string, or categorical-dtype columns by default. The columns, dummy_na, sparse, drop_first, and dtype arguments let you control which columns are expanded, how missingness is represented, storage, reference-level dropping, and output type. Unlike a fitted scikit-learn encoder, a standalone call must be managed carefully so train and production columns remain aligned.
Preventing train–production mismatches
- Identify each categorical feature as ordinal or nominal from its domain meaning, not from its current storage type.
- For ordinal features, document the allowed order and configure it explicitly.
- Split data before fitting encoders so validation and test categories do not leak into training preprocessing.
- Fit the encoder on training data and persist it with the model pipeline.
- Choose unknown-category and missing-value behavior before deployment, then test those branches.
- Inspect the transformed feature names and matrix shape after fitting; alert when new categories, missingness, or cardinality changes unexpectedly.
