LLM Reasoning Benchmarks Compared: Consistency, Bias, and Accuracy

No single LLM benchmark measures reasoning quality on its own. Accuracy tells you whether a response matches a benchmark answer; consistency tells you whether the model repeats an answer across samples or prompts; bias tests expose systematic changes linked to demographic cues; and calibration tests whether confidence tracks correctness. A defensible comparison therefore combines complementary suites, freezes the evaluation protocol, and reports uncertainty instead of treating one leaderboard number as a complete verdict.

What a reasoning benchmark actually measures

A benchmark is a defined set of tasks, scoring rules and evaluation conditions. Its score is evidence about performance on that slice of behavior, not a direct measurement of a general reasoning faculty. A model can solve familiar arithmetic patterns while failing unfamiliar logic, answer broad multiple-choice questions accurately while expressing unjustified confidence, or produce the same answer repeatedly even when that answer is wrong.

Four distinctions keep comparisons honest:

  • Accuracy: whether the output matches the benchmark’s reference answer or satisfies its task-specific scoring rule.
  • Consistency: whether outputs agree across samples, prompts or decoding paths.
  • Bias: whether answers change unfairly when a scenario includes a demographic or protected-group cue.
  • Calibration: whether stated or inferred confidence is higher for answers that are actually correct.

Robustness is a related dimension: it asks whether performance survives a wording change, perturbation or adversarial variation. It should be reported separately because a model may be accurate on the original wording but fragile under small changes.

How the major benchmark families differ

MMLU: breadth across 57 subjects

MMLU (Massive Multitask Language Understanding) covers broad knowledge and reasoning through multiple-choice questions spanning 57 subjects. HELM publishes accuracy broken down by subject, which is more informative than a single aggregate because a model can be strong in mathematics and computer science but weak in law, medicine or humanities.

Use MMLU to inspect breadth and subject-specific gaps. Check the subject mix and the quality of answer keys before drawing conclusions. A high aggregate can conceal a weakness that matters for your application, while a low aggregate may reflect a few difficult subjects that are irrelevant to your users. MMLU does not by itself establish truthfulness, fairness, calibration or repeatability.

GSM8K: structured grade-school mathematics

GSM8K consists of grade-school mathematical word problems. It is useful for arithmetic, translating text into equations and following a structured solution path. It is not a general reasoning exam: a high score does not establish reliable performance on open-ended planning, social judgment, scientific explanation or long-context tasks.

Self-consistency work by Google and Stanford research authors in 2022 reported a 17.9-percentage-point gain on GSM8K under its evaluated setup. That result illustrates the effect of sampling several reasoning paths and selecting the most frequent final answer; it does not mean every model, prompt or decoding configuration will receive the same gain.

BIG-bench and BIG-bench Hard: broad and difficult task collections

BIG-bench contains a wide range of tasks, while BIG-bench Hard focuses on tasks that remain difficult for language models. The collections are useful for probing capabilities that a narrow test cannot represent. Google reports that performance and calibration can improve with scale while remaining poor in absolute terms. The same work reports that social bias typically increases with scale in ambiguous contexts, although prompting can improve that behavior.

Because the task set is heterogeneous, inspect per-task results rather than relying on one average. A model may improve on symbolic tasks while showing little progress on ambiguous social scenarios. BIG-bench results are most useful when the selected tasks resemble the decisions your system must make.

TruthfulQA: resistance to plausible falsehoods

TruthfulQA tests questions where imitating patterns in web text can produce a confident but false answer. It targets truthfulness rather than general factual recall. OpenAI’s TruthfulQA description states: “We suggest that scaling up models alone is less promising for improving truthfulness than fine-tuning using training objectives other than imitation of text from the web.”

A TruthfulQA score should therefore be read as evidence about resistance to common misconceptions and misleading question premises. It does not measure all forms of hallucination, nor does it replace domain-specific factual evaluation with current sources.

BBQ: targeted social-bias evaluation

BBQ (Bias Benchmark for Question Answering) uses question-answer scenarios designed to reveal whether a model favors or stereotypes social groups. Anthropic describes coverage of nine social dimensions and highlights implementation and comparability challenges. Scenario wording, answer options and whether context is ambiguous can materially affect results.

BBQ is a targeted bias probe, not a general reasoning score. Report accuracy and group disparities together, and preserve the exact scenario and scoring version so another evaluator can reproduce the comparison.

HELM: a reproducible, multidimensional harness

HELM is a framework for evaluating models across several dimensions rather than publishing accuracy alone. Its reports combine accuracy with calibration, robustness, fairness, efficiency and toxicity-related metrics. This makes HELM a practical model for cross-model comparisons: the same prompts, versions and scoring procedures can be recorded alongside the results.

Accuracy, consistency, bias, calibration and robustness compared

Axis What it asks Typical measures Main limitation
Accuracy Did the model produce the benchmark answer? Exact match, multiple-choice accuracy, task score Can hide calibration, bias, contamination and protocol effects
Consistency Does the answer persist across samples, prompts or decoding paths? Agreement rate, majority vote, variance across runs A model can be consistently wrong
Bias Do answers change unfairly with demographic or protected-group cues? Group disparity, stereotype or preference rates, BBQ-style accuracy gaps Results depend on scenario design and ambiguity
Calibration Does confidence track correctness? Expected calibration error, reliability curves Confidence formats differ across models
Robustness Does performance survive perturbations or prompt changes? Perturbation accuracy, worst-group or worst-case score More expensive and sensitive to perturbation design

These axes are not interchangeable. Accuracy is an outcome measure; consistency is a repeatability signal; bias is a disparity measure; calibration concerns confidence; and robustness concerns stability under changed conditions. A dashboard that displays only accuracy cannot answer the other questions.

Why consistency is not correctness

The self-consistency method samples diverse reasoning paths for the same problem and chooses the final answer that appears most often. If independent paths converge on the correct answer, majority voting can improve results. If the model’s common misconception appears in most paths, the same method can confidently select an error.

The 2022 self-consistency study reported gains on GSM8K, SVAMP, AQuA, StrategyQA and ARC-Challenge, including the 17.9-point GSM8K improvement noted above. Those gains came from a specific sampling and aggregation setup. Changing the temperature, number of samples, prompt or answer parser can change both cost and outcome.

A 2026 Nature study illustrates the opposite trade-off. Using 4,326 questions per model, the authors found that a consistency-based mitigation reduced hallucinations but also reduced correct answers. The practical lesson is to publish agreement and accuracy side by side. A lower hallucination rate is not automatically an improvement if valid answers are being rejected.

What makes two benchmark scores disagree

Benchmark rankings can change without any change to model weights. Record every condition that can alter the result:

  • Model identity and version: include the exact checkpoint or API model label and evaluation date.
  • Dataset version: note the release, any filtered items and whether answers or prompts were modified.
  • Prompt template: preserve system instructions, role messages, formatting and the requested answer style.
  • Number of shots: state whether the model saw zero-shot, one-shot or few-shot examples, and include those examples when sharing the protocol.
  • Decoding: record temperature, top-p or other sampling settings, maximum tokens and stop conditions.
  • Sampling and aggregation: state the number of runs, random seeds where available, and whether majority vote or another rule selected the answer.
  • Answer extraction: document how a letter, number or final phrase was parsed from a longer response.
  • Contamination controls: explain checks for training exposure or benchmark leakage.
  • Uncertainty: provide confidence intervals, standard errors or run-to-run variation when feasible.

Anthropic’s documentation notes that MMLU and BBQ are not plug-and-play comparisons. HELM is designed to standardize and reproduce evaluation, but reproducibility still depends on publishing the underlying configuration and code.

A defensible workflow for comparing models

  1. Define the decision. Decide whether you need broad knowledge, mathematics, truthfulness, coding, long-context reasoning, safety behavior or another capability. Write down what a useful and harmful error look like for your application.
  2. Map capabilities to suites. Select at least one benchmark for each required capability. For example, pair MMLU for breadth, GSM8K for structured arithmetic, TruthfulQA for misleading premises, BBQ for social-bias probes and a BIG-bench task set for difficult or unusual behaviors.
  3. Freeze the protocol. Lock the model version, prompt, shot count, dataset release, decoding settings, sample count, answer parser and aggregation rule before running the comparison.
  4. Run repeated evaluations. Deterministic decoding gives one path; sampling-based evaluation needs multiple runs. Report the spread rather than presenting a single favorable seed.
  5. Score more than accuracy. Add agreement across runs, calibration, subgroup gaps and robustness to controlled prompt changes. Use the metric that matches the question, not a convenient proxy.
  6. Inspect errors. Review wrong answers, ambiguous items, answer-key problems and cases where a model is consistently wrong. Aggregate scores cannot reveal whether failures are arithmetic slips, unsupported claims, stereotypes or parsing errors.
  7. Publish the conditions. Provide the full configuration, dataset versions, exclusions, uncertainty calculation and scoring code, or use a reproducible harness such as HELM.

How to combine results without hiding trade-offs

Do not average unrelated benchmark percentages into a single “reasoning score.” MMLU subject accuracy, GSM8K arithmetic accuracy, TruthfulQA truthfulness and BBQ disparity answer different questions and have different item designs. An unweighted average can reward a model for excelling at a capability your users never need while masking a severe safety gap.

Instead, create a capability profile:

Reader need Useful evidence Interpretation to avoid
Broad knowledge and subject coverage MMLU aggregate plus its 57-subject breakdown Do not treat the aggregate as proof of truthfulness or fairness
Arithmetic and structured word problems GSM8K accuracy, with protocol and sampling details Do not generalize the result to all reasoning
Resistance to misleading premises TruthfulQA performance and qualitative error review Do not claim that a passing score eliminates hallucinations
Social-bias sensitivity BBQ-style group gaps and scenario-level analysis Do not infer bias from MMLU or GSM8K
Reliability across conditions Agreement, calibration and perturbation results Do not equate repeatability with correctness

Set minimum thresholds for critical dimensions, then compare models that meet them. This prevents a high average from compensating for an unacceptable worst-group disparity or a severe calibration failure.

Bias and calibration need their own tests

Bias cannot be read from a general accuracy leaderboard. A model may achieve the same overall score while producing systematically different answers when names, genders, races, disabilities, religions or other protected-group cues change. Use matched scenarios, report subgroup results and identify whether the context is ambiguous. Ambiguity matters because a model can appear to prefer one group simply by following an under-specified premise.

Calibration asks whether confidence is informative. Expected calibration error summarizes the gap between confidence and observed accuracy across bins; reliability curves show the relationship visually. If a model supplies no numeric confidence, you can evaluate selective answering or abstention behavior instead, but state that the confidence representation differs. A model that answers fewer questions yet is well calibrated may be safer for high-stakes review than one that answers everything with unjustified certainty.

Common validity threats

  • Saturation: when many models approach the ceiling, small score differences stop being informative.
  • Contamination: training exposure can inflate results without demonstrating transferable reasoning.
  • Flawed items: ambiguous wording, incorrect keys or culturally specific assumptions can penalize a model for the wrong reason.
  • Leaderboard age: an old ranking may not represent current model versions, prompting conventions or data contamination conditions.
  • Prompt sensitivity: rankings can change with system messages, demonstrations and formatting.
  • Sampling cost: consistency estimates require multiple generations, increasing latency and expense.
  • Metric gaming: optimizing for a known benchmark can improve its score while leaving real-world behavior unchanged.

When any of these threats is substantial, qualify the claim and prioritize error analysis and task-specific tests over a precise-looking rank order.

What a strong benchmark report includes

A useful report lets another team reproduce the comparison and understand its limits. Include the model version and date, dataset releases, prompts, shot count, decoding and sampling settings, parser, aggregation rule, contamination checks, confidence intervals or run variation, subgroup definitions and all exclusions. Show per-task or per-subject results where available, not only an aggregate.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Report accuracy together with consistency, calibration, robustness and bias measures when those dimensions affect the deployment decision. Explain disagreements: a model may have higher MMLU accuracy but poorer TruthfulQA truthfulness, or higher self-consistency with a lower rate of correct answers. Those are actionable trade-offs, not contradictory data.

Bottom line for choosing benchmarks

Choose a portfolio, not a winner. MMLU measures breadth, GSM8K probes a narrow but useful mathematical skill, BIG-bench explores varied and difficult tasks, TruthfulQA targets truthful responses to misleading questions, BBQ probes social bias, and HELM demonstrates how to combine accuracy with calibration, fairness, robustness, efficiency and toxicity-related measures. Freeze the protocol, publish uncertainty and inspect errors. A high accuracy score is not evidence of truthfulness, fairness, calibration or reliable reasoning in deployment, and a consistent answer is not necessarily a correct one.
