How to Run AI Models When Your GPU Has Limited Memory

Run local AI on a low-VRAM GPU by choosing a compatible model, quantizing weights, reducing context and workload, and using measured CPU/GPU offload when needed.

What’s actually slowing this PC down?

Limited VRAM does not automatically rule out local AI. The reliable approach is to work down a fixed sequence: choose a model and file format your runtime supports, load a quantized version, reduce context and concurrent workload, then move part of inference to system RAM or the CPU if necessary. Measure peak memory and tokens per second on your own machine after every change. There is no universal “model size equals required VRAM” chart because architecture, quantization, context length, runtime buffers, backend and hardware all change the result.

What consumes GPU memory during inference?

A model’s weight file is only the first allocation. During loading and generation, the runtime may also reserve memory for the key-value (KV) cache, temporary calculation buffers, tokenizer or vision components, prompt-processing batches and multiple simultaneous requests. A model can therefore fail after its weights appear to fit, especially when you select a long context window or a large batch.

Memory behavior also differs by architecture. A text-only language model, a vision-language model and an image-generation model use different components and kernels. The same nominal parameter count can produce different peak allocations, and a quantized file supported by one runtime may not be usable by another. Treat every stated memory figure as specific to a model build, quantization, context, workload and software version.

Use this order of operations

  1. Pick the smallest model that meets the task and confirm that its architecture and file format are supported.
  2. Choose a quantized build to reduce weight memory while checking quality on your actual task.
  3. Lower context length, batch size and concurrency so the runtime has room for the KV cache and working buffers.
  4. Split execution between the GPU and CPU/RAM when the model still does not fit.
  5. Record peak VRAM, system-memory use, prompt-processing speed and generation speed, then increase settings gradually.

Changing several variables at once makes failures and quality changes difficult to diagnose. Keep a short record of the model file, quantization, runtime version, context setting, GPU-layer setting and measured speed.

1. Start with a model and format your software can actually load

Match the model to the job

Use the smallest model that can perform the task acceptably. A compact instruction model may be sufficient for classification, extraction or short drafting, while coding, multilingual work or visual reasoning may require a larger or multimodal model. Removing unnecessary parameters is often more effective than trying to force a large model into a constrained card.

Do not infer suitability from a model’s parameter count alone. Read the model card and the files supplied for that specific release. Look for supported architectures, required context limits, quantized variants, tokenizer files and any special runtime instructions. Test a representative prompt rather than assuming that a model that starts will produce useful output.

Choose a compatible file format

llama.cpp uses GGUF model files and provides quantization and backend support for local inference. A Transformers workflow using bitsandbytes has different dependencies, loading arguments and hardware requirements. A GGUF file is not interchangeable with a Transformers checkpoint simply because both contain the same model family. Select the format documented by your chosen runtime, or follow the project’s documented conversion procedure.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Before downloading a large file, verify the runtime build and GPU backend. CUDA, ROCm, Metal and other backends have different support matrices, and a CPU-only build will not use your GPU regardless of the model file. Keep the runtime, driver and quantization library versions recorded so you can reproduce a working configuration.

2. Quantize the weights to reduce VRAM use

Quantization stores model weights at lower numerical precision. It is one of the most practical ways to make local inference possible, but it is a memory-versus-quality decision, not a free optimization. Compare outputs on the prompts you care about: a quantization that is adequate for chat may be noticeably worse for exact code generation, arithmetic, retrieval or image descriptions.

Weight representation Memory effect What to check
FP16 or BF16 Highest weight memory among these common choices Use when quality is the priority and the model plus runtime overhead fit comfortably
8-bit loading Substantially less weight memory than 16-bit loading Confirm bitsandbytes, CUDA and hardware compatibility; test task quality
4-bit and other low-bit builds Further reduces weight memory Check the exact quantization scheme and model file; evaluate degradation on representative prompts
More aggressively compressed variants May permit a larger model on the same card Expect a stronger quality trade-off and measure both output quality and speed

The labels used by a runtime are not interchangeable. llama.cpp offers multiple quantization levels for GGUF files, while bitsandbytes exposes its own loading modes in Transformers. Select a file explicitly documented for the model and runtime instead of renaming or guessing from a filename.

Transformers with bitsandbytes

In a Transformers application, an 8-bit load can be configured with a BitsAndBytesConfig. A typical pattern is:

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.
from transformers import AutoModelForCausalLM, BitsAndBytesConfig

quantization_config = BitsAndBytesConfig(
    load_in_8bit=True,
    llm_int8_enable_fp32_cpu_offload=True
)

model = AutoModelForCausalLM.from_pretrained(
    "your-model-id",
    quantization_config=quantization_config,
    device_map="auto"
)

The identifier in this example is a placeholder for the model you have selected. The offload flag keeps selected portions in 32-bit form on the CPU; it is not the same as converting the entire model to 8-bit. Follow the current bitsandbytes and Transformers documentation for installation, supported GPUs and CUDA versions, because an unsupported combination can fail before the model loads.

Validate quality, not just successful loading

Prepare a small test set of real prompts: several short requests, a long-context request if you need one, and any domain-specific tasks such as code, structured JSON or visual questions. Save outputs from the unquantized or higher-precision version when possible, then compare factual accuracy, instruction following, formatting and omissions. A model that loads but makes unacceptable errors is not a successful optimization.

3. Reduce context and workload pressure

After weights are compressed, the next frequent cause of out-of-memory errors is the runtime workload. Longer context requires a larger KV cache, and larger prompt batches or concurrent requests require additional buffers. Start conservatively and raise one setting at a time.

Lower the context window

Set the context length to the largest value your application actually needs, not the maximum advertised by the model. For a short question-and-answer tool, try 2,048 or 4,096 tokens before attempting a much larger window; the correct value depends on the model and workload. If a long document is required, process it in chunks or summarize earlier sections rather than allocating a huge cache by default.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

In llama.cpp command-line tools, the context option is commonly exposed as -c or --ctx-size. For example:

llama-cli -m model.gguf --ctx-size 2048

Use the option name documented by the exact binary you installed. Server builds can expose the same setting with a long-form option, but defaults and accepted ranges vary by version.

Reduce batch size and concurrency

Prompt-processing batches can consume considerable temporary memory even when generation is stable. Lower the batch or micro-batch setting if loading succeeds but the first prompt causes an out-of-memory error. For a server, reduce the number of parallel sequences or simultaneous requests. A single-user configuration often needs far less memory than a multi-user server with the same model and context.

Leave headroom

Do not allocate nearly every visible megabyte to model weights. The desktop, display server, CUDA runtime and inference buffers need space, and allocation can change during generation. A configuration that works with an empty prompt may fail when a real prompt expands the KV cache. Reserve practical headroom and watch peak, rather than initial, VRAM use.

4. Split inference between GPU and CPU/RAM

If a suitable quantized model still exceeds available VRAM, use a runtime that supports hybrid inference. llama.cpp can keep some layers on the GPU and execute the remainder on the CPU, using system RAM for the larger allocation. This can make a model runnable when full GPU placement is impossible, but data transfers across the bus generally reduce throughput and can make prompt processing or generation feel much slower.

Control GPU layers in llama.cpp

llama.cpp exposes a GPU-layer control commonly named -ngl or --n-gpu-layers. Start with a conservative value and increase it until VRAM is close to, but not beyond, the safe limit:

llama-cli -m model.gguf --ctx-size 2048 --n-gpu-layers 20

The exact number of layers that fit depends on the model architecture, quantization, context and backend. If the process fails, lower the layer count; if memory remains unused and speed matters, raise it in small increments. Record the value that works with your normal prompt, not only an empty test.

Understand the speed trade-off

GPU-layer offload is a capacity technique first. More layers on the GPU usually reduce CPU work, but the best split depends on the card, processor, RAM speed, PCIe link and workload. A setup-specific Windows Central test using an RTX 5080 observed lower generation throughput when more work moved into system memory. That observation is not a general benchmark or a promise of a particular tokens-per-second result for another machine.

Do not confuse unified memory with fast VRAM

Some builds and drivers can use a unified-memory or memory-fallback mode. It may prevent an immediate allocation failure by allowing pages to spill into system RAM, but system RAM has different bandwidth and latency from dedicated VRAM. Treat this as a fallback for capacity, not as equivalent to having sufficient VRAM. If the operating system begins paging heavily, reduce the model, context or GPU workload instead of accepting an unusably slow session.

5. Measure the configuration on your own machine

Use a repeatable test so you can distinguish a memory fix from a performance regression.

  1. Record the baseline. Write down the GPU model and VRAM, system RAM, driver, runtime version, model file, quantization, context length, batch setting and GPU-layer count.
  2. Watch allocation during loading and generation. On an NVIDIA system, run nvidia-smi in another terminal and note memory before loading, after loading and at the peak reached by a long prompt. Equivalent monitoring tools exist for other GPU backends.
  3. Use a fixed prompt set. Include a short prompt, a representative production prompt and the longest context you expect. Keep sampling settings constant while comparing memory or speed.
  4. Measure both phases. Record prompt-processing speed and generation speed separately when the runtime reports them. A configuration can generate quickly after a slow prompt upload, or the reverse.
  5. Change one variable. Adjust quantization, context, batch, concurrency or GPU layers individually, then repeat the same prompts.
  6. Check output quality. Compare correctness, formatting, citations or code behavior; a faster result that fails the task is not an improvement.

Peak values matter more than averages. Capture system-memory use as well when offload is enabled, because a model that technically runs may exhaust RAM and trigger operating-system swapping.

Compatibility checklist before installing

  • Is the model architecture supported by the selected runtime?
  • Is the downloaded file in the format that runtime expects, such as GGUF for llama.cpp?
  • Does the quantization build match the model revision and tokenizer?
  • Does the GPU backend support the required kernels and data types?
  • Are the driver, CUDA or other accelerator libraries within the versions documented by the runtime?
  • Does the model card specify a special conversion, rope-scaling, vision dependency or maximum context?
  • Can your system provide enough RAM for the portion that will remain on the CPU?

Resolve compatibility questions before tuning memory. An unsupported file or backend cannot be repaired by lowering the context window.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Troubleshooting by symptom

Symptom Likely pressure point First action
Fails while loading weights Model representation is too large for the selected placement Choose a smaller model or lower-bit compatible build; then reduce GPU layers or enable documented offload
Loads, then fails on the first prompt KV cache or prompt batch needs more memory Lower context length and batch size; test again with the same model
Works for short prompts but fails on long ones Context growth increases cache allocation Use a smaller context, chunk documents or reduce simultaneous sequences
Runs but becomes extremely slow Most work has moved to CPU/RAM or the system is paging Reduce model size or context, increase GPU layers only if headroom exists, and monitor system RAM
Outputs are poor after quantization Compression changed task-relevant behavior Use a higher-quality quantization or smaller higher-precision model and compare on your test prompts
Runtime rejects the model file Format or architecture mismatch Download the format documented for that runtime or perform the official conversion

When buying more VRAM is the sensible answer

Software tuning is preferable when the task is occasional, a slower response is acceptable or a smaller model meets the quality requirement. More VRAM becomes reasonable when you need a large context, several concurrent users, a multimodal model with substantial visual components or consistently high throughput that CPU offload cannot provide.

Compare cards by usable VRAM, supported backend, driver availability, power and cooling, not by memory capacity alone. A card with more VRAM can keep more layers and cache on the GPU, but it does not guarantee a particular model, context length or generation speed. The model, quantization and runtime still determine the actual fit.

Bottom line

Limited GPU memory is a constraint to manage, not an automatic stop sign. Select a compatible smaller model, quantize it deliberately, keep context and workload settings modest, and use measured CPU/GPU hybrid inference when necessary. Validate peak memory, speed and task quality on the exact hardware and software you intend to run; those measurements are more useful than a generic VRAM chart.
