Optuna can replace an exhaustive grid with sampled parameter proposals, and its pruners can stop trials before training finishes—but only when your objective reports useful intermediate results. Those are separate features: a sampler chooses what to try; a pruner decides whether a running trial should continue.
The title’s claim that 12 of 20 trials were “killed” is not established by the available sources. Optuna’s tutorial includes a 20-trial example with pruned trials, but that example is not evidence of a typical result or of this particular outcome. In Optuna’s terminology, these are pruned trials, not failed ones.

Grid search and Optuna solve different parts of the problem
Grid search exhaustively evaluates combinations from a finite set of values. That can be useful when the grid is small and complete coverage matters, but its cost grows with the number of combinations. Optuna can also run a grid: its GridSampler enumerates the specified combinations. Moving to Optuna does not, by itself, mean abandoning grid search.

A pruner is an additional mechanism: it evaluates intermediate results from a running trial and may stop that trial early. It does not choose better parameter values; that is the sampler’s role. Optuna’s current tutorial identifies TPESampler as the default sampler and documents GridSampler as its grid-search implementation (Optuna, Efficient Optimization Algorithms).

| Approach | How configurations are chosen | When work can stop | Best fit |
|---|---|---|---|
| Scikit-learn grid search | Every specified combination is evaluated. | Typically after each configuration’s fit and scoring complete; no Optuna-style pruning is built into a one-shot fit. | A small, finite search space where exhaustive coverage is important. |
Optuna with GridSampler |
Specified grid combinations are enumerated. | Only if the objective exposes intermediate progress and a pruner is configured. | Keeping a grid while using Optuna’s study and trial workflow. |
| Optuna with a non-grid sampler and a pruner | The sampler proposes configurations; proposals need not cover every point in a fixed grid. | A pruner may stop an individual trial after reported intermediate results. | Iterative training where intermediate metrics are useful and early stopping can save work. |
Scikit-learn’s documentation describes the conventional search workflow and its parameter-grid approach (scikit-learn, Tuning the hyper-parameters of an estimator). The practical choice depends on search-space size, whether parameters are conditional, available compute, and how well early measurements predict final performance.
How to replace GridSearchCV with an Optuna study
An Optuna study optimizes an objective function, and each trial is one execution of that function. The basic migration is to move parameter suggestions, model training, and validation scoring into the objective, then ask the study to optimize it. The project’s scikit-learn example demonstrates this pattern (Optuna project repository).

- Install and check the version. Use the project’s documented pip or conda installation route, then check the installed package version in your environment. The Optuna repository reports that v5 was released on September 7, 2026; API details can change, so match examples to the version you install.
- Define a stable evaluation. Use the same data split or cross-validation procedure for trials, and ensure each trial returns a comparable validation metric. Keep preprocessing and leakage controls consistent with your existing workflow.
- Write an objective that suggests parameters. Use methods such as
trial.suggest_floatortrial.suggest_intfor the parameters being optimized. Choose ranges and distributions that reflect the model rather than mechanically copying a grid. - Set optimization direction explicitly. Use
direction="minimize"for a loss or error anddirection="maximize"for a score. The final objective and every reported intermediate value must use the same metric and direction. - Create the study and optimize. Select a sampler and, when the objective supports intermediate reporting, a pruner. Set a trial budget appropriate to the cost and search space, and retain the study history so trial outcomes can be inspected.
import optuna
from sklearn.ensemble import RandomForestClassifier
from sklearn.model_selection import cross_val_score
def objective(trial):
model = RandomForestClassifier(
n_estimators=trial.suggest_int("n_estimators", 50, 300),
max_depth=trial.suggest_int("max_depth", 2, 20),

)
return cross_val_score(model, X, y, cv=5, scoring="accuracy").mean()
study = optuna.create_study(direction="maximize")
study.optimize(objective, n_trials=50)
This example illustrates sampled hyperparameter optimization, not pruning: each cross-validation call returns a score only after the fit work completes. The n_trials value is an example budget, not a recommended universal number. If preserving exhaustive grid coverage is important, configure an Optuna GridSampler instead of assuming a different sampler will visit every combination.

A pruner needs checkpoints at which the objective can report progress. In iterative training, those checkpoints might be epochs or boosting rounds. At a consistent step, report an intermediate validation value with trial.report(value, step), then ask trial.should_prune(). If it returns true, raise optuna.TrialPruned(). The Optuna tutorial describes this report-and-check pattern and demonstrates it with incremental SGD; it also shows a LightGBM pruning callback (Optuna, Efficient Optimization Algorithms).

import optuna

raise optuna.TrialPruned()
return accuracy_score(y_valid, model.predict(X_valid))
study = optuna.create_study(direction="maximize")
study.optimize(objective, n_trials=50)
The example assumes that X_train, y_train, X_valid, y_valid, and classes are already prepared. Its purpose is to show where reporting belongs, not to prescribe a model or validation scheme. Report metrics at comparable steps across trials: if one trial’s step 5 represents substantially more training than another’s, the pruner’s comparison may not be meaningful.
Optuna’s tutorial summarizes the requirement: “To turn on the pruning feature, you need to call report() and should_prune() after each step of the iterative training.”

Why an Optuna pruner may not stop trials
Pruning is conditional, not a quota. A study may prune none, some, or many trials depending on the reported values, pruner configuration, and workload. Check the objective and study before concluding that pruning is broken:
- No intermediate reports: A one-shot
.fit()followed by a final score gives the pruner no checkpoint at which to stop that fit. Use an iterative loop or a framework integration that exposes progress. - No pruning check: Reporting values alone does not stop a trial. The objective must call
trial.should_prune()and raiseoptuna.TrialPruned()when it returns true, unless the integration’s callback handles that flow. - Warmup or startup rules: Pruners can wait for startup trials, warmup steps, intervals, or a minimum number of completed trials before pruning. Check the installed version’s arguments and defaults rather than assuming every early trial is eligible. The
MedianPrunerAPI documents these configuration controls (Optuna MedianPruner API reference). - Direction or metric mismatch: Ensure the study direction is correct and that the objective’s reported value is the same metric being optimized. A score should not be treated as a loss, or vice versa.
- Weak early signal: If early validation values are noisy or poorly predict final outcomes, a pruner may not find clear candidates to stop—or may stop a trial that would have improved later. Use checkpoints that make methodological sense for the training process.
- No compatible integration: For frameworks with their own training loops, use a supported callback or integration that reports intermediate values. Optuna recommends integration modules for major machine-learning frameworks; verify the appropriate package and API for your installed version.
When a trial is stopped by the pruning mechanism, record it as a pruned trial, not a failed trial. A pruned-trial count alone does not establish compute savings: record elapsed time and how far each stopped trial progressed.

Choosing a sampler and pruner for the workload
Sampler and pruner choices should follow the objective’s behavior, not a blanket recipe. A sampler controls proposals; a pruner controls early termination. Optuna’s tutorial reports a benchmark-based recommendation of MedianPruner with RandomSampler, and HyperbandPruner with TPESampler, for non-deep-learning workloads. The tutorial qualifies that result by its benchmark conditions, so it should not be treated as a universal rule or a current independent benchmark.
The foundational Optuna paper describes its define-by-run API and the framework’s search and pruning strategies (Akiba, Sano, Yanase, Ohta, and Koyama, 2019: Optuna: A Next-generation Hyperparameter Optimization Framework). In practice, make the decision by asking whether the search space is large or conditional, whether the training loop yields comparable intermediate metrics, how expensive a complete trial is, and whether the available compute supports the desired degree of parallelism.
How many trials should you run?
There is no trial count that works for every model or search space. A trial budget of 20 in Optuna’s tutorial is part of an illustrative example, not a general recommendation; its observed pruned runs do not prove what another study will prune. Choose a budget according to evaluation cost, search-space complexity, and the compute time available, then inspect whether additional trials are still finding materially better configurations.
For a reproducible and auditable comparison, record the sampler and its arguments, pruner and its settings, Optuna version, search-space definitions, random seeds, data splits, objective code, trial states, and total elapsed time. If reporting a count such as “12 of 20,” show how “pruned” is defined and include the study’s actual trial records. To claim a speedup, compare total work or elapsed time against the baseline; a pruned-trial count by itself is not a speed measurement.
