Clean a messy dataset by preserving the original, checking how it was imported, profiling its structure and values, applying only defensible corrections, and validating every change. Missing values, duplicates, and extreme numbers need context: none should be “fixed” automatically without a rule tied to the data and the question you plan to answer.
1. Preserve the source before making changes
Keep an untouched, preferably read-only copy of the file. Work on a separate copy or in a tool that creates a project from the imported data. Record the source, collection date, units, and known collection or export conventions; those details help distinguish errors from legitimate values later.

OpenRefine says it copies imported information into a project rather than modifying the original file. Its project archive can still expose the original state and edit history, however, so an archive may be unsuitable for sharing when the data needs anonymization. See OpenRefine’s starting and import documentation.

2. Check that the file was interpreted correctly
Before cleaning values, confirm that the software read the file as intended. Check the delimiter, header row, character encoding, worksheet, and the meaning of each row and column. A parsing mistake can make sound data look corrupted—or quietly scramble it.

- Easily store and access 2TB to content on the go with the Seagate Portable Drive, a USB external hard drive
- Designed to work with Windows or Mac computers, this external hard drive makes backup a snap just drag and drop
- To get set up, connect the portable hard drive to a computer for automatic recognition no software required
- This USB drive provides plug and play simplicity with the included 18 inch USB 3.0 cable
- The available storage capacity may vary.
- Confirm that the first row is actually a header and that columns have the expected names.
- Check whether separators, quotation marks, and encoding preserve the values you expect.
- For a spreadsheet with multiple worksheets, verify which sheet was imported. OpenRefine imports one worksheet from a multi-sheet spreadsheet.
- Do not rely on spreadsheet formatting such as cell colors to carry through an import: OpenRefine’s documentation says it does not preserve formatting of that kind.
OpenRefine may infer a parser from a file’s extension or content, but it also lets you choose separator and encoding settings. Check the import preview and settings rather than assuming automatic detection was right (OpenRefine documentation).
3. Profile the data before editing
First learn what is present. Note the number of rows and columns, inspect representative records, and review distinct category values, ranges, missingness, and possible duplicates. Ask what each field represents: a variable, identifier, date, category, or free-text value. That classification affects how it should be interpreted.
For example, an ID such as 00127 may need to remain text; treating it as a number can remove leading zeros that are part of the identifier. A date column may contain multiple formats, while a category may have spelling or capitalization variants. Profiling helps reveal those patterns without committing to a correction.

OpenRefine offers facets, filters, and sorting for exploring values before transformation (OpenRefine documentation; exploring data). A useful structure to aim for is one variable per column, one observation per row, and one type of observational unit per table. That is Hadley Wickham’s description of tidy data, reproduced in a university library workshop (workshop).
4. Standardize formats only when the intended value is clear
Normalize whitespace, category labels, spelling, units, dates, and numeric formats according to explicit rules. For example, you might standardize capitalization in a category if the variants clearly refer to the same category. Do not make that change merely because two strings look similar: they could identify different people, places, or products.
OpenRefine supports editing cells, transforming values, splitting and joining columns, reshaping data, and clustering similar strings. Its documentation notes that types can vary at the cell level and that converting a whole column may fail to parse some cells (exploring data; transforming data). Review conversion failures and ambiguous rows rather than silently coercing them into a value that looks valid.

5. Decide what missing values mean
A blank, “N/A,” “unknown,” zero, and false do not automatically mean the same thing. Before standardizing missing-value tokens, determine whether they represent the same situation in this dataset. Then count missing values by field and, where useful, by row; investigate whether they result from nonresponse, a collection limitation, inapplicability, or another cause.
Whether to leave values missing, exclude records, or impute values depends on the analysis question and how the data was collected. Do not replace missing values with zero or false unless the source and meaning of the field justify it. There is no universal imputation recipe supported by the cited documentation.
In pandas, missing-value markers vary by data type. Its documentation recommends isna() and notna() to detect missing values; comparisons such as value == np.nan, value == NaT, or value == pd.NA are not reliable substitutes (pandas missing-data guide).

6. Review duplicates and outliers with domain context
Duplicates
Decide what makes a record unique before removing anything. Exact duplicate rows may be accidental copies, but repeated transactions or measurements may be legitimate. Define the key for an observation, then check both exact duplicates and near matches against that rule. OpenRefine’s clustering can group similar strings, but the group is a review aid—not proof that the entries refer to the same entity (OpenRefine transformations).
Extreme values
Treat an unusual value as a candidate to investigate, not an error by definition. Check the original source, units, and plausible bounds for the field. A value that looks extreme may be a valid rare event, a unit mismatch, or a transcription mistake. The cited sources establish no universal statistical cutoff for outliers, so choose a rule that fits the data and document why you applied it.
Do these 3 things before closing this tab:
1Clear out junk files and repair common Windows errors2Fix the driver behind crashes, sound loss and screen glitches3Repair Windows errors before they cause bigger problems7. Validate the cleaned dataset and keep a record
After each meaningful set of changes, inspect what changed and check whether the result still meets the requirements of the analysis. Compare before-and-after summaries rather than relying on the cleaned file’s appearance alone.

OpenRefine keeps project history and supports undo; the university workshop notes that documenting operations can be useful supplemental material (OpenRefine transformations; workshop). If you share results, export the cleaned dataset when that is sufficient; avoid sharing a project archive if it could expose protected source data or edit history (OpenRefine documentation).
Which tool should you use?
Choose based on your workflow, not on an assumed universal size limit. The cited documentation does not establish a controlled performance comparison or a dataset-size cutoff for OpenRefine versus pandas.
| Option | Useful when | Consider |
|---|---|---|
| OpenRefine | You want a visual, hands-on workflow for importing, profiling with facets, transforming, clustering, and exporting tabular data. | It works with a local project according to its manual, but privacy still depends on choices such as fetching external data or sharing project archives. Check input and export requirements and preserve a safe copy of the source (documentation; starting and import; workshop). |
| pandas | You want cleaning steps expressed in code and integrated with a repeatable analysis workflow. | Consider whether your team can review and maintain the code, and how you will record changes. pandas documents programmatic data operations and missing-data handling (user guide; missing-data guide). |
For either option, weigh dataset size and performance in your actual environment, repeatability and version control, visual versus code review, team skills, privacy and external-data access, supported formats, export needs, and the clarity of the tool’s audit history. If a change could alter the meaning of a record, make the rule reviewable and retain the original value.
Quick wins for a faster PC:
Fix the driver behind crashes, sound loss and screen glitchesFind Drivers →Clear out junk files and repair common Windows errorsFree Scan →Make cleaning an iterative part of analysis
Cleaning is not always a one-time pre-analysis phase. Exploration can reveal new inconsistencies, and later data collection can introduce new formats or missingness patterns. The university workshop reproduces Wickham’s observation that data preparation may need to be repeated as new problems emerge; treat that as a practical warning, not as evidence for a measured “80%” statistic (workshop). When analysis exposes a defect, return to the preserved source, revise a documented rule, and validate the resulting dataset again.
