How to Back Up Model Checkpoints and Datasets for GPU Cloud Disaster Recovery

Keep training state outside the GPU machine, version every object, replicate it to an independent failure domain, and rehearse a clean restore. A durable disaster-recovery design copies more than model weights: optimizer and scheduler state, random-number state, preprocessing and tokenizer versions, immutable dataset manifests, code, container and driver details, infrastructure configuration, and the permissions needed to access them. This lets you resume in another region or provider instead of rebuilding from an uncertain starting point.

What a recoverable training run must preserve

A GPU instance is a compute worker, not a backup system. Local disks and attached ephemeral volumes can disappear when an instance is preempted, a quota is exhausted, a region has an outage, or an operator deletes the project. Write checkpoints to storage that survives the instance, then copy completed checkpoints and dataset snapshots to a second failure domain.

Recovery means returning to a known training state, not merely finding a file named model.bin. A usable checkpoint normally includes:

  • Model parameters and any sharded weight files.
  • Optimizer state, including momentum or variance accumulators.
  • Learning-rate scheduler state and the global step or epoch.
  • Random-number-generator state for the framework, data loader, and distributed workers.
  • Automatic-mixed-precision scaler state, when mixed precision is used.
  • Tokenizer files, vocabulary, model configuration, and generation or evaluation settings.
  • Metrics and the run’s event history so you can identify the best or last valid checkpoint.
  • A manifest that names the exact dataset snapshot, preprocessing code, configuration, and source revision used to produce it.

Without optimizer, scheduler, and random state, you may load weights but fail to resume the same optimization trajectory. Without a data manifest, you may unknowingly train on a changed or incomplete corpus. Keep these items together under an experiment-and-run prefix so an operator can identify a complete recovery unit.

Use a five-tier backup architecture

Separating speed, durability, geography, infrastructure, and validation prevents one storage choice from becoming a single point of failure.

1. Fast checkpoint tier

Write frequent checkpoints to a high-throughput path close to the training cluster. This tier minimizes pause time and supports rapid restart after a worker failure. It can be a parallel file system or a nearby object-storage path, but it should not be the only copy.

Checkpoint I/O can consume substantial accelerator time. An AWS example calculates that 48 checkpoints taking three minutes each across 4,000 accelerators represent 2.4 hours of wall-clock checkpoint time and 9,600 GPU-hours per day. AWS presents this as an illustrative workload calculation, not a universal benchmark; your cost depends on model size, storage throughput, parallelism, and implementation. Use asynchronous writes or multi-level checkpointing when synchronous writes materially stall training.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

2. Durable object-storage tier

After a checkpoint is complete, asynchronously copy it to versioned object storage. Store the checkpoint directory, dataset snapshot or immutable reference, and manifest as one logical release. A copy should be considered complete only after all objects are present and checksums have been verified.

3. Regional disaster-recovery tier

Replicate durable objects to a separate region or an explicitly independent storage account. Keep enough historical versions to cover the time between silent corruption or accidental deletion and its detection. A second copy in the same failure domain does not protect against a regional outage or a project-wide administrative error.

4. Infrastructure tier

Back up the recipe that recreates the training environment. AWS disaster-recovery guidance explicitly says that, in addition to user data, you must back up code and configuration. Retain infrastructure-as-code, container image digests, machine-image identifiers, CUDA and driver versions, dependency lock files, IAM roles, network rules, quota requirements, and references to secrets. Store secret references and rotation procedures, not plaintext credentials in a checkpoint.

5. Validation tier

Schedule restore drills that create a clean project or region, restore a representative checkpoint and dataset, verify checksums, load the model, and run a short deterministic validation. Record the elapsed time to usable training and compare it with your recovery-time objective (RTO). A backup that has never been restored is an assumption, not a measured recovery capability.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Set recovery objectives before choosing a checkpoint cadence

Recovery-point objective (RPO)

RPO is the maximum amount of training you can afford to lose. If your RPO is 30 minutes, the durable copy of a valid checkpoint must normally be no more than 30 minutes behind the run; replication lag and failed uploads count against that budget. RPO is not the same as the local checkpoint interval: a checkpoint may exist on the fast tier while its cross-region copy is still pending.

Recovery-time objective (RTO)

RTO is the time from declaring an outage to resuming useful training. It includes provisioning GPUs, restoring data, pulling the correct image, attaching permissions and networks, loading the checkpoint, and validating the first batch. A design with excellent RPO can still miss its RTO if the GPU quota, image, or dataset restore is not prepared.

Choose cadence from measured overhead

No universal authority-prescribed checkpoint interval exists. Set cadence from four measurements:

  • Failure frequency and the amount of work lost when a worker fails.
  • Time to write and read a complete checkpoint on the fast tier.
  • Acceptable training slowdown from checkpoint I/O.
  • The lag and reliability of durable and cross-region copies.

Start with a cadence that meets the RPO under normal replication lag, then test it under peak model and dataset sizes. If checkpoints are expensive, keep a lightweight frequent state locally and a less frequent full durable snapshot, provided the lightweight state is itself recoverable and its relationship to the full snapshot is documented.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Make checkpoints and datasets immutable and identifiable

Use an explicit naming scheme

Include project, experiment, run, global step, creation time, and software revision in the object prefix or manifest. Never overwrite a production checkpoint with a new run. Separate folders or prefixes by experiment and training run, as Google Cloud recommends for Cloud Storage checkpoints.

Version objects and protect deletion

Enable object versioning in Google Cloud Storage and Amazon S3 so an overwrite or deletion leaves a recoverable prior version. In Azure Blob Storage, enable soft delete for object-level recovery. Versioning does not replace replication: a malicious or administrative action that removes all versions, or a region-wide outage, still requires an independent copy and controlled access.

Capture dataset identity, not only a path

For every run, record the dataset snapshot identifier, object-generation or version identifiers where available, file list, byte counts, and checksums. Keep preprocessing code, schema assumptions, filtering rules, and tokenizer version beside the manifest. If a source dataset is mutable, materialize an immutable snapshot before training or record a content-addressed manifest that can be reconstructed exactly.

Verify integrity at write and restore time

Calculate checksums for each large object and for the manifest itself. Verify them after upload, after replication, and after restore. Google Cloud documents checksum-based integrity checking and an annual durability design target of at least 99.999999999%; that target does not guarantee recoverability when permissions, versioning, replication, or restore procedures are wrong.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Provider implementation choices

Provider Checkpoint and version controls Geographic recovery option Operational qualification
AWS Amazon SageMaker training jobs accept an S3 checkpoint URI so an interrupted job can resume. Enable S3 object versioning. Use S3 Cross-Region Replication to a disaster-recovery bucket in another region. Replication, IAM, encryption, quotas, and the destination account must be included in recovery tests.
Google Cloud Google recommends saving training checkpoints and model artifacts in Cloud Storage and enabling object versioning. Choose regional, dual-region, or multi-region Cloud Storage according to the geographic resilience required. Location type changes resilience and placement; confirm that the selected location satisfies data-residency and latency requirements.
Azure Use Blob Storage soft delete to recover objects deleted or overwritten by mistake. Copy blobs to a storage account in another region for disaster recovery. Validate copy completion, identity assignments, encryption settings, and the destination account in a clean environment.

These services differ in replication behavior, retention controls, egress pricing, identity models, and restore tooling. Compare them on the same operational axes rather than selecting a provider solely for nominal storage durability.

Implement the backup workflow step by step

  1. Define the recovery unit. Decide what constitutes a restorable run: a full model state, optimizer and scheduler state, RNG and scaler state, tokenizer and configuration, metrics, dataset manifest, code revision, and environment metadata.
  2. Create isolated storage prefixes or containers. Separate experiments and runs. Grant the training role write access to the active prefix and restrict deletion and retention changes to a separate operations role.
  3. Write checkpoints atomically. Write to a temporary step-specific location, finish all shards and metadata, calculate checksums, then publish a completion marker or manifest. Consumers should never treat a partially uploaded directory as a valid checkpoint.
  4. Enable recovery controls. Turn on object versioning for Google Cloud Storage or Amazon S3, or Blob soft delete for Azure. Set retention so versions survive your detection window for operator error and silent corruption.
  5. Copy completed checkpoints asynchronously. Transfer only after the completion marker is present. Record source and destination object versions, checksum results, and replication status in the run metadata.
  6. Replicate to the independent region or account. Configure S3 Cross-Region Replication, a Cloud Storage dual-region or multi-region location, or an Azure copy to another regional account. Treat a replication failure as an operational alert, not a harmless delay.
  7. Snapshot datasets and manifests. Freeze the exact dataset input or create an immutable snapshot. Store preprocessing and schema versions with the snapshot manifest.
  8. Archive the rebuild recipe. Save infrastructure-as-code, container digest, machine-image identifier, CUDA and driver versions, dependency lock files, IAM and network configuration, quota requirements, and secret references.
  9. Monitor lag and completeness. Alert when the newest durable checkpoint is older than the RPO, when a required shard is missing, when checksum verification fails, or when replication is behind its stated objective.
  10. Run a restore drill. In a clean project or region, provision the documented stack, restore the dataset and checkpoint, verify checksums, load the model, execute a short deterministic validation, and record time to usable training.

Design the restore procedure for a region or provider outage

Declare the failure boundary

Decide whether the incident affects one GPU worker, a zone, a region, an account, or the provider. Do not copy data back into a potentially compromised account before access and integrity are understood. Select the predetermined secondary region or provider and open the recovery change record.

Recreate identity and infrastructure first

Apply infrastructure-as-code in the recovery environment. Recreate network rules, service identities, encryption-key access, quotas, logging, and the approved container or machine image. If any dependency is unavailable, use the documented compatible version and record the deviation for later reconciliation.

Restore and verify data

Restore the dataset snapshot and checkpoint versions selected by the run manifest. Verify every checksum, expected object count, and byte count before starting GPUs. A successful object transfer is not proof that the model can load; perform an actual framework load and a short validation batch.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Resume conservatively

Start with the newest checkpoint whose manifest, checksums, and dataset snapshot all pass validation. If optimizer or RNG state is missing, treat the result as a new fine-tuning or recovery run and record that it is not an exact continuation. Keep the original failed run read-only until the recovered run is accepted.

Measure the result

Record outage declaration time, infrastructure-ready time, data-restore completion, model-load time, first successful validation, and first resumed training step. Compare these timestamps with the RTO and note any manual action that should be automated.

Compare designs on the dimensions that affect recovery

Dimension Questions to answer Evidence to record
RPO How old can the newest cross-region, complete checkpoint be? Checkpoint timestamps, upload completion, and replication lag.
RTO How long until a validated training step runs? Measured restore-drill timeline, including GPU provisioning.
Throughput Does checkpoint I/O stall accelerators or exceed storage limits? Write/read duration, bandwidth, and training slowdown.
Replication Can the destination be used during a regional outage, and how far behind can it be? Replication status, lag alerts, and destination permissions.
Retention Can you recover from an error discovered days or weeks later? Version and soft-delete retention policy and protected-admin controls.
Restore cost What storage-read and cross-region egress charges apply during a large restore? Provider price estimate for the actual dataset and checkpoint volume.
Security Who can write, delete, restore, or change retention? IAM policy, key-management settings, audit logs, and break-glass process.
Software reproducibility Can the exact GPU stack be recreated elsewhere? Image digest, driver/CUDA versions, dependency lock, and infrastructure code.

Security and access controls

  • Encrypt data in transit and at rest, and document which identity can use each encryption key.
  • Use separate roles for training writes, replication, restore, and deletion-policy administration.
  • Block public access and review cross-account or cross-project trust used by replication.
  • Log object reads, deletes, version changes, retention changes, and key-use events.
  • Keep credentials out of checkpoints, manifests, container layers, and infrastructure repositories; store only references to a managed secret and its rotation process.
  • Test recovery with least-privilege identities, then separately test the controlled break-glass path needed for a provider-wide incident.

Common failure modes and fixes

Only the latest weights were saved

Symptom: The model loads but loss spikes or training cannot continue. Fix: Include optimizer, scheduler, RNG, scaler, tokenizer, and configuration state in the recovery unit, and reject checkpoints whose manifest is incomplete.

Checkpoint exists locally but not in object storage

Symptom: The instance is gone and the newest files are missing. Fix: Monitor durable-upload completion and alert when the durable checkpoint age exceeds the RPO. Keep the fast tier as a performance layer, never as the sole copy.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Replication silently stalled

Symptom: The secondary region contains an older run. Fix: Alert on replication lag and failed objects, record destination versions, and include a simulated replication outage in restore drills.

Accidental overwrite or deletion

Symptom: A valid checkpoint or dataset snapshot has been replaced. Fix: Use object versioning or Blob soft delete, restrict retention changes, and practice selecting and restoring a prior version.

Recovery environment cannot start the model

Symptom: Data restores, but the image, driver, CUDA, dependency, or quota is incompatible. Fix: Archive image digests and infrastructure configuration, reserve or routinely test GPU quota, and make the clean-environment drill part of the release process.

Dataset changed between training and restore

Symptom: The same path now resolves to different files or preprocessing output. Fix: Restore the immutable snapshot named in the checkpoint manifest and verify file checksums and preprocessing revision before resuming.

A practical recovery policy

For each production experiment, publish a short policy alongside the run metadata:

  • Target RPO and RTO, including the region or provider used for recovery.
  • Checkpoint cadence, full-versus-lightweight checkpoint rules, and measured I/O overhead.
  • Storage prefixes, versioning or soft-delete retention, replication destination, and encryption keys.
  • Required checkpoint files, dataset snapshot identifier, checksums, and completion-marker format.
  • Container digest, machine image, CUDA and driver versions, dependency lock, infrastructure code, quotas, and secret references.
  • Named owners for monitoring, restore approval, and post-incident reconciliation.
  • Restore-drill schedule and the pass criteria: checksum success, model load, deterministic validation, and elapsed time within RTO.

This policy turns a collection of copies into an auditable recovery service. The decisive test is not whether storage reports a durable object; it is whether a clean environment can load the right state and resume useful training within the promised time.

Questions operators commonly ask

Should every checkpoint be copied across regions?

Copy every checkpoint needed to meet the RPO, but you can reduce cost by retaining a defined set of historical full checkpoints and shorter-lived intermediate states. The retention rule must still cover your detection window for corruption and operator error.

Does provider durability eliminate the need for backups?

No. Durability protects stored objects against certain infrastructure failures; it does not recreate deleted versions, correct a wrong dataset manifest, grant missing permissions, or build a GPU environment. Versioning, independent replication, configuration backup, and tested restores address those failure modes.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Can a checkpoint from one provider be resumed on another?

Usually only when the framework format, tokenizer, dependencies, GPU software, and dataset preprocessing are compatible. Preserve portable artifacts and the rebuild recipe, then validate the model load and a deterministic batch before treating the run as resumed.

What should be restored first during an incident?

Restore identity and infrastructure prerequisites, then the exact dataset snapshot and a checkpoint whose manifest and checksums pass. Start GPUs only after these checks; otherwise expensive compute can be wasted debugging an incomplete restore.
