How CLIP Finds Images from Natural-Language Queries

CLIP-based image search encodes a text query and a collection of images into a shared vector space, then ranks images by similarity. Here’s how that pipeline works and what its scores do—and don’t—tell you.

CLIP finds images by turning both images and a text query into vectors in a shared embedding space, then ranking the saved image vectors by similarity to the query vector. CLIP supplies the encoders and comparison mechanism; an image-search application handles the collection, index, ranking, and display.

What happens when you search with a sentence?

Suppose your collection contains photographs and you search for “a red bicycle leaning against a brick wall.” A CLIP-based system encodes each image in advance, encodes the sentence when you submit it, compares the query vector with the stored image vectors, and returns the highest-scoring matches.

The result is a ranking, not a guarantee that every returned image meets every detail in the sentence. Similarity scores indicate how closely a model’s image and text representations align; they are not automatically calibrated probabilities or proof of a complete match.

How CLIP learned to connect language and images

CLIP has an image encoder and a text encoder trained to place paired images and captions near one another in a shared vector space. During training, the model learns to distinguish matching image-text pairs from mismatched pairs. This teaches a reusable relationship between language and visual features rather than relying only on a fixed output layer of predetermined labels.

  • These vector images are available in the following formats: SVG, EPS, AI and CDR. These are high quality vector images not pixelated images like you see on the internet. We do not recommend that you order this product unless you understand what a vector image is and/or know how to work with them. This product is not for amateurs or those who lack basic computer skills.
  • CD-ROM includes 137 rare and original Hunting and Fishing images on CD-ROM plus 100 bonus images. CD-ROM includes a printable PDF catalog of all the images included in this collection. CD-ROM also includes a printable PDF catalog of all the images included in this collection. All artwork is royalty free.
  • Additional image file formats available: JPG (3000 x 3000 pixels at 300 dbi) and PNG (2000 x 2000 pixels at 300 dbi with a transparent background).
  • All images are "sign ready" AKA "cut ready" (artwork is optimized for cutting and for sign making production). All images require no clean-up and can be scaled to any size without distortion. Images are detailed and very realistic. Each image is hand drawn to perfection.

In the original 2021 work, OpenAI described training on 400 million image-text pairs. Its introduction explains a proxy task in which the model selects the correct text from 32,768 randomly sampled snippets. In a reported zero-shot comparison with the original ResNet-50, the 1.28 million labeled ImageNet examples were not used to train CLIP. These figures describe the original research and experiments; they are not a current dataset-size claim or a promise of search quality for a particular collection. Read the OpenAI introduction to CLIP and the original paper.

How an image-search pipeline works

  1. Prepare the collection. Load the images and apply the preprocessing expected by the selected model. OpenAI’s repository provides a transform with clip.load.
  2. Encode the images. Run the image encoder over the collection and save each feature vector with an image identifier or path. The repository exposes model.encode_image.
  3. Encode the query. Tokenize the natural-language query and pass it to the text encoder. The repository exposes clip.tokenize and model.encode_text.
  4. Compare and rank. Compare the query vector with stored image vectors, commonly using cosine similarity, then sort the scores and return the top results. Small collections can be compared directly; larger systems may use a vector index, but there is no universal collection-size threshold established by the cited guides.
  5. Show and evaluate results. Display the ranked images and test the system on representative queries and images from its intended domain. The OpenAI model card calls for thorough in-domain evaluation before deployment.

The OpenAI CLIP README describes its displayed image-text values as “cosine similarities between the corresponding image and text features, times 100.” Treat those values as ranking signals for the model and comparison at hand, not as calibrated confidence percentages.

A practical implementation example from Ultralytics’ semantic image-search guide uses local images, NumPy-based ranking, CPU or CUDA inference, and an optional Flask interface. Those are example implementation choices, not a universal performance benchmark or production recommendation.

What CLIP search can and cannot distinguish

Flexible descriptions, not just fixed labels

Because the query is text rather than a selection from a fixed label list, a search can express combinations of visual concepts in ordinary language. That flexibility does not mean the model reasons reliably about every detail in a sentence.

Counting and systematic reasoning

OpenAI’s 2021 introduction reports weaknesses on abstract or systematic tasks, including counting objects and estimating distances. Do not rely on a similarity ranking as a dependable count or measurement.

Fine-grained categories and wording

The model card warns that fine-grained classification can be difficult and that performance and bias may vary with how categories are designed or included. Closely related types, subtle attributes, or query phrasing may therefore need direct evaluation in the target collection.

Language coverage

The model card says CLIP was not purposefully trained or evaluated in languages other than English and recommends limiting use to English-language use cases. Do not assume that a translated query will retrieve results as reliably as an English query.

What to evaluate before relying on results

OpenAI’s model card describes research as the intended use and says deployed use is out of scope; it states, “Any deployed use case of the model – whether commercial or not – is currently out of scope.” A working demo is not evidence of deployment readiness. For an image-search application, evaluate the actual model and application on the intended collection and queries, and account for the model card’s concerns about task context, category design, and bias.

  • Test representative everyday queries as well as ambiguous and difficult cases from the intended domain.
  • Check whether fine-grained distinctions, counts, or attributes that matter to users are actually retrieved correctly.
  • Measure indexing and query latency and resource use on the intended hardware; the cited sources provide no universal hardware recommendation.
  • Choose direct comparison or a vector index based on benchmarks for the collection rather than an assumed cutoff.
  • Review data and application risks. The model card notes that training data came from public image-caption sources, that internet-connected populations are unevenly represented, and that disparities were found in a studied people-classification setup. These findings warrant application-specific scrutiny, not an assumption that every task has the same measured disparity.

Can CLIP search video?

The basic pipeline described here searches still images; it does not directly search temporal video content. One practical workaround is to extract frames, index them as images, and search those frames. That approach can surface relevant moments, but it does not by itself provide temporal understanding of events between frames.
