AI weather models do not forecast by calculating every cloud, eddy, radiation exchange and fluid interaction from first principles each time you request a forecast. Instead, a neural network learns how a gridded atmospheric state usually changes, then applies that learned state-to-state transformation repeatedly into the future.

That shortcut applies mainly at forecast time. The training data and starting conditions still come from physics-based meteorology: reanalyses such as ERA5 are created with data-assimilation systems, and operational centers use numerical weather prediction to produce both datasets and initial conditions. AI therefore avoids repeatedly solving the full set of equations during inference without becoming independent of atmospheric physics.

What “without simulating every physical process” actually means

Traditional numerical weather prediction (NWP) represents the atmosphere on a three-dimensional grid. It advances temperature, pressure, wind, humidity and other variables by numerically solving partial differential equations derived from fluid dynamics, thermodynamics, radiation and related processes. Because many important phenomena occur below the grid scale, operational models also use parameterizations for unresolved clouds, turbulence, convection and other effects.

A conventional ten-day run can take hours on a supercomputer with hundreds of nodes. At each time step, the model calculates another approximation of atmospheric evolution. The calculation is physically explicit, but expensive.

An AI weather model takes a different deployment route. During training, it sees many examples of an atmospheric field at one time and the field at a later time. The neural network adjusts its parameters until it can predict the later field from the earlier one. Once trained, a forecast is a forward pass through that network. The predicted state then becomes the input for the next lead-time step, allowing the system to roll forward to several days.

The network is not discovering weather from nothing. It is compressing regularities in historical atmospheric evolution into a learned transition operator. Forecast-time computation therefore does not explicitly calculate every physical interaction, even though the patterns the network learned reflect those interactions.

The physics-based data pipeline behind AI forecasts

Reanalysis supplies a consistent training record

ERA5 is a global reanalysis produced through physics-based data assimilation. Data assimilation combines observations with a numerical forecast model to estimate the most physically consistent atmospheric state at each time. ECMWF reports that ERA5 is used to train many current AI weather systems.

This matters because a neural network trained on ERA5 inherits information from the physical model and from the observations assimilated into it. The model can learn atmospheric relationships at a global scale, but the quality, coverage and biases of that training record still influence its output.

Initial conditions still matter

At forecast time, an AI model normally receives a gridded initial state generated from observations and a physics-based analysis system. Current machine-learning systems also rely heavily on data derived from the Integrated Forecasting System (IFS) for training, validation or initialization. If the starting state is poor, a fast learned rollout cannot reliably reconstruct the missing information.

“Without simulating every physical process” therefore describes the computation after initialization. It does not mean that AI weather forecasts are detached from observation networks, data assimilation or conventional meteorology.

How a learned atmospheric transition works

Input: a gridded snapshot

The input is a set of atmospheric fields arranged by latitude, longitude, altitude or pressure level, and time. Typical fields include wind components, temperature, geopotential, humidity and surface variables. The network receives values at a defined analysis time, along with the spatial relationships encoded by the model architecture.

Output: a future state

The target is the same kind of gridded state at a future lead time. During training, the network minimizes a loss function that measures differences between its prediction and the target. A common choice is root-mean-square error (RMSE), although models can also be evaluated with anomaly correlation and event-specific measures.

Rollout: repeating the operator

For a multi-day forecast, the model applies its learned transformation repeatedly. A six-hour model, for example, predicts the state six hours ahead; that prediction is fed back in to obtain the next six-hour state. Errors can accumulate because each prediction becomes part of the next input. Architectures and rollout strategies are designed to limit this drift.

This repeated application is why the network can produce a ten-day forecast without running a full physical simulation for every minute or resolving every cloud-scale process. It is also why stability, lead-time design and out-of-distribution behavior are critical.

Pangu-Weather: a concrete example

Training and evaluation data

In the reported setup, Pangu-Weather was trained on 39 years of global data from 1979 through 2017. The study used 2019 for validation and 2018 for testing. Those dates describe that paper’s experimental split, not a guarantee that every later implementation uses the same data.

A three-dimensional Earth-specific transformer

Pangu-Weather uses a 3D Earth-specific transformer. Vertical pressure levels are represented as a real dimension rather than being treated as unrelated two-dimensional maps. That lets the network learn relationships among atmospheric layers, such as how structures at different pressures evolve together.

Separate lead-time networks

The reported system trains separate networks for 1-hour, 3-hour, 6-hour and 24-hour lead times. A rollout can choose the largest affordable step for the forecast stage instead of taking only one-hour increments. This hierarchical temporal aggregation reduces the number of iterations and, consequently, the opportunities for cumulative rollout error.

What its published benchmarks showed

In the paper’s benchmark, a single-GPU inference took 1.4 seconds. The authors reported that this was more than 10,000 times faster than operational IFS in their tested inference comparison. Those are measurements from that hardware, dataset and implementation; they are not universal latency guarantees.

How GraphCast and FourCastNet fit the same picture

ECMWF has evaluated GraphCast, FourCastNet and Pangu-Weather from common initial conditions. All are data-driven systems trained using ERA5 in the versions discussed by ECMWF, but their architectures differ.

Model Approach described in the available evaluations Key qualification
Pangu-Weather 3D Earth-specific transformer with vertical pressure levels represented explicitly; separate 1-, 3-, 6- and 24-hour networks Reported training period: 1979–2017, with 2019 validation and 2018 testing in the paper’s setup
GraphCast Global machine-learning weather model from Google DeepMind, trained and evaluated in the ERA5-based comparisons Performance depends on the initial conditions, variables and verification period used
FourCastNet Neural-operator approach using spherical geometry in the version described by ECMWF Designed for efficient global prediction; event performance must be checked separately from average error

The comparison is not simply “AI versus physics.” These systems learn from records generated with physics-based methods and are generally initialized from analyzed atmospheric states. Their distinction is the learned forecast operator used after initialization.

Why AI forecasts are so much faster

One forward pass replaces many numerical steps

A trained neural network evaluates matrix operations on hardware optimized for parallel computation. It does not need to iterate through every physical equation at the smallest stable time step. The learned mapping can jump directly from one atmospheric state to a state several hours later.

Large lead-time steps reduce rollout count

Pangu-Weather’s hierarchical strategy illustrates a second source of speed. Using a 24-hour network where appropriate requires fewer calls than advancing exclusively with a one-hour network. Fewer calls also reduce the accumulation of numerical and learned-model error, although a larger jump can miss short-lived details if the model has not learned them well.

Benchmark figures need their conditions attached

Reported figure What it measured How to interpret it
1.4 seconds Pangu-Weather single-GPU inference in the 2023 paper’s setup Inference latency for that implementation and hardware, not total data-assimilation or operational-pipeline time
More than 10,000× faster Pangu-Weather paper’s tested comparison with operational IFS A benchmark-specific ratio; hardware, resolution and workload determine any real deployment ratio
7 seconds Example cited by Nature for a 100-member, 24-hour FourCastNet forecast Shows the potential for rapid ensemble-style computation in the cited setup

Operational timing also includes downloading observations, preparing initial conditions, quality control, post-processing and distributing products. A neural-network forward pass can be extremely fast without making the entire forecasting system instantaneous.

Accuracy: what the reported comparisons found

In the Pangu-Weather paper’s ERA5 evaluation, five-day 500-hPa geopotential-height (Z500) RMSE values were 296.7 for Pangu-Weather, 333.7 for operational IFS and 462.5 for FourCastNet. Lower RMSE is better. These values apply to the reported variable, lead time, initialization and evaluation design; they should not be generalized to every weather variable or region.

The paper also reported higher anomaly-correlation scores and lower RMSE than the comparison systems for the variables it tested. ECMWF independently found Pangu-Weather to be a legitimate rival to IFS when both were evaluated with the same initial conditions against observations during a European winter period.

These results show that a learned operator can match or exceed a conventional forecast on important medium-range metrics. They do not prove that one architecture is best for every lead time, weather regime or application.

Why average scores are not enough for dangerous weather

Smoothing can hide the worst outcomes

Training with a loss such as RMSE rewards the average prediction. When several outcomes are plausible, an average-like output can score well while producing a storm that is too weak, too broad or too symmetric. That behavior is especially concerning for tropical cyclones, convective storms, floods and high-wind events.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

The Freddy case study

In an ECMWF assessment of tropical cyclone Freddy, Pangu-Weather and FourCastNet under-predicted wind intensity and the symmetry of the cyclone. The result is a reminder that a favorable global RMSE does not establish reliable intensity forecasts for an extreme event.

Event-focused verification

Safety-critical evaluation should include:

  • Track, intensity and structure errors for tropical cyclones.
  • Peak wind, rainfall and pressure errors rather than only domain-wide averages.
  • Performance during rare extremes, not just ordinary weather.
  • Impact measures tied to flooding, power disruption, aviation or public safety.
  • Reliability and calibration of probabilities when the model is used in an ensemble.

What AI weather models still do not solve

Reanalysis is not the same as direct observation

The Pangu-Weather paper trained and tested on reanalysis rather than raw observational data. The authors noted that real-world systems use observations and that some variables, including precipitation in the paper’s scope, were not investigated. A model can therefore perform impressively on a reanalysis benchmark while remaining less certain about observation errors, local precipitation and poorly represented phenomena.

Uncertainty and ensembles

A single deterministic neural-network rollout gives one future atmospheric state. Real weather is chaotic, and small initial-condition errors can grow. ECMWF identifies ensemble forecasts, uncertainty quantification and reliability as essential operational criteria. Early AI systems did not yet provide all of those capabilities at the level required for routine decision-making.

Distribution shift and rare events

Training data contain many more ordinary days than unprecedented extremes. Climate trends, changing observation coverage, unusual storm structures or regional conditions outside the training distribution can expose weaknesses that average test scores conceal. Continuous monitoring and revalidation are necessary when a model is deployed beyond the period and data regime used for development.

Are AI models replacing numerical weather prediction?

Not by themselves. Physics-based NWP remains essential for producing reanalyses such as ERA5, assimilating observations and generating the initial conditions that AI models consume. It also provides a trusted reference for diagnosing failures and testing new methods.

ECMWF describes the likely direction as hybrid rather than a clean replacement. AI can accelerate a physical model, downscale its output, verify forecasts, emulate expensive components or provide an independent forecast for comparison. Neural operators can also support super-resolution or downscaling while retaining a representation of spherical geometry.

Meteorological centers contribute observing networks, domain expertise, quality control, verification standards and operational safeguards. Those functions are not eliminated by a fast neural-network inference step.

How to judge an AI weather model fairly

When comparing systems, ask for all of the following rather than accepting a speed or accuracy headline:

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.
  • Training data: Which reanalysis, observations or model outputs were used, and what years and regions were included?
  • Initialization: Were all models started from the same analyzed state?
  • Resolution: What horizontal grid spacing and vertical levels are represented?
  • Variables: Are wind, temperature, pressure, humidity, precipitation and surface fields all forecast, or only a subset?
  • Output type: Is the result deterministic, probabilistic or an ensemble?
  • Rollout design: What lead-time steps are used, and how many recursive calls are required?
  • Verification target: Is the comparison against ERA5, independent observations or another model?
  • Extreme-event skill: How does it perform for cyclones, heavy rain, heat waves and high-impact local events?
  • Latency and hardware: Is the reported time for one forward pass, a complete forecast cycle or an ensemble?
  • Reliability: Are uncertainty, calibration, monitoring and fallback procedures documented?

This checklist prevents a fast benchmark on one variable from being mistaken for an operationally complete forecasting system.

The practical takeaway

AI weather models work by learning an atmospheric transition from large archives of gridded states and applying that transition in a rapid forward pass. They skip the repeated, explicit solution of every physical process during inference, which explains their exceptional speed. But the models learn from physics-informed reanalysis, usually start from physics-based analyses and must still be judged on uncertainty, extremes and operational reliability.

The most credible near-term role is complementary: use AI to accelerate, augment, downscale or cross-check numerical forecasts while retaining observations, physical models and rigorous verification. As ECMWF has put it, this is “in no way the death of conventional modelling.”
