A purpose-built accelerator such as a Google TPU, AWS Trainium or AWS Inferentia can be the better choice when the model, precision, workload volume and software stack are stable enough to exploit that chip efficiently. A custom in-house ASIC is justified only when demand is predictable for years and the organization can finance silicon, compilers, networking and operations.
There is no universal cheapest or fastest option. Select hardware by measuring cost per useful output, target latency, throughput, memory, interconnect performance, engineering time and cloud availability on your exact model—not by comparing peak FLOPS alone.

The practical answer
GPU, AI accelerator and custom ASIC are not three mutually exclusive categories. An AI accelerator is the umbrella term; GPUs, TPUs, NPUs and other neural-network chips all fit under it. A GPU is a broadly programmable parallel processor. A custom ASIC is a chip designed for a narrower workload. Google describes its Tensor Processing Unit (TPU) as an application-specific integrated circuit built as a matrix processor specialized for neural networks.
That distinction leads to a useful default:
- Choose a GPU for learning, prototyping, fine-tuning, unusual operators, rapidly changing architectures or applications that span several frameworks.
- Benchmark a managed accelerator for large, repeatable workloads that fit a vendor compiler and runtime. Google TPUs, AWS Trainium and AWS Inferentia can be compelling when utilization is high and the software port is straightforward.
- Build a custom ASIC only when model behavior and demand are stable for years, volume is large enough to amortize non-recurring engineering, and the organization can support the complete software and hardware platform.
Training and inference are separate decisions. A chip that lowers training cost may not deliver the latency, memory footprint or serving economics required in production. Evaluate each phase with its own workload and service-level target.

What each term means
GPU
A graphics processing unit contains many parallel arithmetic units and a mature programming ecosystem. Modern data-center and workstation GPUs expose high-bandwidth memory, tensor or matrix instructions, low-precision formats and fast device-to-device links. Their broad operator coverage lets teams run common deep-learning frameworks while retaining the ability to write custom kernels when a model uses an uncommon operation.
Google Cloud offers NVIDIA GPU machine types for machine learning, artificial intelligence and high-performance computing, including high-memory configurations and low-precision formats for serving. AMD GPUs are another option when their hardware and software stack supports the required framework and operators.
AI accelerator
AI accelerator is a category, not a single architecture. It includes GPUs, TPUs, NPUs, inference cards and other processors optimized for neural-network operations. Comparing an unnamed accelerator with a GPU is therefore incomplete: the relevant questions are which model, precision, compiler, memory system, interconnect and deployment environment are involved.
Custom ASIC
An application-specific integrated circuit is designed around a defined workload rather than broad general-purpose programmability. Google TPUs are an example of an ML-focused ASIC. A truly in-house ASIC narrows the design further around a company’s own tensor shapes, precision choices, dataflow and serving pattern. Narrower scope can improve performance per watt or per dollar, but it also increases the risk that a new model, operator or market change makes the design less useful.
GPU, managed accelerator and custom ASIC compared
| Decision factor | GPU | Managed AI accelerator | Custom ASIC |
|---|---|---|---|
| Primary strength | Broad programmability and ecosystem | Efficiency on workloads supported by the vendor compiler and runtime | Maximum specialization for a known workload |
| Model and operator flexibility | Generally highest; custom kernels are available | Depends on supported framework, compiler and operators | Lowest unless the company funds new hardware and compiler work |
| Best fit | Experimentation, fine-tuning, mixed frameworks and changing architectures | Large, stable training or inference workloads with predictable volume | Very high, durable volume with a stable architecture and strict efficiency goals |
| Porting effort | Usually lowest when the framework already targets the GPU stack | Can require graph changes, compiler configuration and unsupported-operator work | Requires hardware, compiler, kernels, drivers, tools and production integration |
| Memory and scale-out | Varies by model; inspect HBM, host memory and GPU interconnect | Varies by generation; inspect HBM, host links and collective communication | Must be designed and operated as part of the system |
| Repurposing after a workload changes | Relatively easy | Possible within the vendor’s supported workloads | Difficult and potentially uneconomic |
| Price comparison | Not a universal winner | Not a universal winner | Requires volume and engineering amortization |
There is no universally comparable current price ranking across these categories. Generation, region, reservation, utilization and software-stack costs can reverse an apparent hardware bargain.
Why a GPU is usually the starting point
Broad framework and operator coverage
Machine-learning projects change quickly. A research team may move from convolutional networks to transformers, add retrieval, test a new quantization method or insert a custom preprocessing step in the same quarter. GPU software has broad support across common frameworks and a large library of optimized kernels. That reduces the chance that an unsupported operation stalls a project.
Lower switching cost during experimentation
A GPU can serve as a baseline for both training and inference. Teams can establish model quality and throughput before deciding whether a specialized chip’s efficiency justifies a port. This is particularly valuable when the final architecture, sequence length, batch size or numerical precision is still changing.

Flexible memory and deployment choices
GPU products span workstation cards, single-node servers and multi-node systems. Select enough device memory for the model and optimizer state, then verify host-memory and interconnect requirements. A card with higher theoretical compute can lose to a lower-FLOPS card if it forces smaller batches, frequent transfers or expensive model sharding.
When the GPU default is not enough
GPU flexibility does not guarantee the lowest cost. If a stable service runs at high utilization and every operation maps efficiently to a purpose-built accelerator, the GPU’s generality may be paying for capability the workload never uses. That is the point at which an apples-to-apples benchmark is warranted.
When a purpose-built accelerator can win
Stable, high-volume training
Google TPUs and AWS Trainium target large-scale training economics when the framework and compiler path are supported. A team should first reproduce a representative training run, including input pipelines, checkpointing and distributed collectives. Compare cost per completed training step and time to reach the same validation quality, not just raw matrix throughput.
High-volume, latency-sensitive inference
Inference has different constraints: tail latency, batching behavior, cold-start time, memory per replica and cost per request. AWS positions Inferentia for purpose-built inference economics. Google announced Ironwood as an inference-focused TPU generation. Either can outperform a GPU for a supported model and precision, but only a benchmark at the target latency and traffic distribution can establish that result.
Compiler-supported model shapes and precision
Specialized chips reward regular tensor shapes, supported data types and predictable execution graphs. If the model relies on dynamic control flow, custom operations or frequent architecture changes, compiler limitations can erase the theoretical advantage. Confirm support for the exact framework version, attention implementation, quantization scheme, sequence lengths and collective operations you intend to deploy.
Training and inference require different evaluations
Training checklist
- Measure time per optimizer step and time to reach a fixed quality target.
- Include data loading, augmentation, checkpoint writes, evaluation and failed or restarted jobs.
- Test the intended scale, because communication overhead can dominate when adding devices.
- Record device utilization, memory headroom and batch-size limits.
Inference checklist
- Use the production model, tokenizer, quantization and serving runtime.
- Measure p50, p95 and p99 latency at the expected request mix and concurrency.
- Report throughput at the latency limit, such as tokens per second or requests per second.
- Include model loading, orchestration, networking and idle capacity in the cost calculation.
Do not transfer a training result to serving by assumption. An accelerator can be excellent at large batches yet unsuitable for single-request latency, or efficient for inference while lacking the memory or compiler features needed for training.
Memory, networking and scale-out often decide the result
Memory capacity
Check whether the full model, activations, optimizer states and temporary buffers fit in device memory. If they do not, account for sharding, activation rematerialization, offloading and the communication they add. A nominally faster processor can be slower overall when it spends time moving tensors between device and host memory.

Bandwidth and interconnect topology
Compare HBM capacity and bandwidth, host-memory bandwidth, device-to-device links and the topology connecting nodes. Distributed training depends on collective operations such as all-reduce; the number printed on a compute datasheet does not describe those costs. For inference, network hops between a router, model server and accelerator affect tail latency.

A dated example of why specifications need context
Google’s 2025 Ironwood announcement lists 7.37 TB/s of HBM bandwidth, described as 4.5 times Trillium’s figure. That is a memory-bandwidth claim for a particular generation, not a guarantee of end-to-end application speed. The model, batch size, precision, compiler and communication pattern still determine delivered throughput.
Software portability is part of the hardware choice
Questions to answer before a port
- Which framework and version are officially supported?
- Are all model operators compiled natively, or will some fall back to a host processor or custom kernel?
- Can the runtime handle dynamic shapes, variable sequence lengths and the required precision?
- How are profiling, debugging, checkpointing and fault recovery performed?
- Can the team keep the same model code across development, training and serving?
A port is successful only when the complete application runs efficiently. Count engineering hours for graph rewrites, kernel development, compiler work, CI, observability and incident response. A nominally cheaper instance can cost more if utilization remains low while the team resolves unsupported operations.
Portability and lifecycle risk
GPUs are generally easier to repurpose when a product changes. A managed accelerator ties more of the stack to a vendor runtime, while a custom ASIC ties it to a particular silicon generation and internal toolchain. Include migration options, support windows, replacement availability and the cost of retaining a second implementation.
How to calculate total cost
Use cost per useful output rather than hourly price or peak FLOPS. For training, a practical metric is total cost to reach a defined quality target:
training cost per target model = compute and storage cost + networking cost + engineering cost + retry and idle cost
For inference, use cost per million tokens or cost per request at the required latency. Include the number of replicas needed for failover, minimum instance sizes, preprocessing, postprocessing, model transfer and monitoring. Amortize one-time porting and integration work over the realistic volume and service life.

Prices vary by generation, region, reservation, utilization and software stack. The available evidence does not establish a universal current price winner among GPUs, TPUs, Trainium, Inferentia and custom silicon.

|---|---|---|
| 4.7x peak compute per chip versus TPU v5e | Google Cloud’s 2024 Trillium announcement | Useful for comparing the cited peak specification; not a substitute for your model benchmark |
| More than 67% greater energy efficiency than TPU v5e | Google Cloud’s 2024 Trillium announcement | Indicates a vendor-reported generational efficiency claim under its stated conditions |
| 7.37 TB/s HBM bandwidth; 4.5x Trillium | Google’s 2025 Ironwood announcement | Shows the memory-bandwidth scale of that generation; application throughput still depends on workload and system design |
| Just over seven million accelerator shipments in 2024; 73% GPUs and 27% ASICs | U.S. Department of Energy report published in 2025, citing IDC and Omdia | Describes shipment mix, not relative performance, price or suitability |

How to run a fair hardware benchmark
- Freeze the workload. Record the exact model revision, dataset or request trace, framework and runtime versions, sequence lengths, batch sizes, precision and quality target.
- Define the output metric. For training, use time and cost to reach a fixed validation score. For inference, use cost per million tokens or request at a specified p95 or p99 latency.
- Warm up and repeat. Exclude one-time compilation only when production can also reuse the compiled artifact; otherwise include compilation and startup time. Run enough repetitions to expose variance.
- Measure the whole system. Capture input pipelines, host processing, storage, networking, checkpointing, orchestration and failures, along with device utilization and memory use.
- Test scale-out. Compare one device, one node and the intended multi-node configuration. Record scaling efficiency and collective-communication time.
- Account for engineering. Estimate porting, kernel, compiler, CI, monitoring and incident-response work, then amortize it over realistic workload volume.
- Check portability. Run representative future changes—such as a new sequence length, operator or quantization mode—to see whether the result survives normal product evolution.
Google recommends a normalized measure such as tokens per second per chip while holding model architecture constant. That is a useful reporting unit, but pair it with cost, quality, latency and utilization so a high-throughput number cannot hide an expensive or incompatible deployment.
Common failure modes and fixes
Choosing from peak FLOPS alone
Symptom: The selected chip looks faster on paper but delivers little improvement. Fix: Profile memory stalls, communication, unsupported operators, input throughput and actual utilization.
Ignoring compiler fallbacks
Symptom: A specialized accelerator runs some layers on a host processor or uses an unoptimized path. Fix: Inspect the compiled graph, quantify fallback time and either rewrite the operation or include the cost in the comparison.
Recommended Free Tools
Under-sizing memory
Symptom: The model requires tiny batches, frequent offload or complex sharding. Fix: Calculate parameter, activation, optimizer and workspace memory before selecting the device.
Benchmarking a toy model
Symptom: A small synthetic test produces a result that disappears in production. Fix: Use the production architecture, data pipeline, request distribution and quality checks.
Forgetting utilization and availability
Symptom: A low nominal price is offset by scarce capacity or idle reservations. Fix: Verify regional availability, reservation terms, minimum deployment size, failure recovery and expected utilization.
Locking in too early
Symptom: A custom or specialized implementation cannot follow a new model. Fix: Keep a portable GPU path until workload stability and volume justify the migration, and budget for a second implementation when lifecycle risk is material.

Use a GPU when flexibility, fast iteration and broad software support matter most. Use a managed AI accelerator when a measured, high-volume workload maps cleanly to the vendor’s compiler and the resulting cost or efficiency advantage survives full-system testing. Build a custom ASIC only when the business can commit to long-lived demand and to the software, networking and operational platform around the silicon.
