For most teams building machine-learning or generative-AI systems, a data lakehouse is the better primary platform. It keeps structured tables, semi-structured events, documents, images and other files in one governed environment, so engineers can train models and build features without repeatedly exporting data. A traditional data warehouse remains the safer choice when the requirement is narrowly defined, high-concurrency SQL reporting over stable, structured data.

Many organizations do not choose one exclusively. They retain lakehouse storage and engineering access, then publish warehouse-style marts or SQL-serving endpoints for finance, operations and executive dashboards. The right decision depends on data types, freshness, streaming, model-training access, concurrency, governance and the total cost of storage, compute, movement and operations—not on a generic claim that one architecture is always faster or cheaper.

What a data warehouse and a data lakehouse are

Data warehouse

A data warehouse is a managed analytical database designed primarily for curated, structured data. Teams model entities such as customers, orders and revenue with defined schemas, keys and business rules, then expose SQL views or dimensional marts to reporting tools. Schema-on-write validation catches many errors before data reaches analysts, and the platform generally offers predictable SQL behavior, workload management and concurrency controls.

This design is excellent when the source systems and metrics are well understood. A finance dashboard can query a governed revenue model without knowing how the underlying application tables are organized. The trade-off is that raw logs, documents, audio, images and rapidly changing event formats often need preprocessing, conversion or separate storage before they become useful warehouse tables. Moving those assets between systems can add pipelines, copies and delay.

Data lake

A data lake stores data of almost any nature—relational extracts, JSON events, application logs, text, images and model artifacts—usually in inexpensive cloud object storage. Data can be interpreted when it is read, which makes ingestion quick and preserves source detail. Without strong table formats, metadata and access controls, however, a lake can become a collection of files that are difficult to query consistently or govern.

Data lakehouse

Microsoft Learn defines a lakehouse as “a data management system that combines the benefits of data lakes and data warehouses.” It adds warehouse-like table reliability, SQL access and governance to open, scalable lake storage. In a production lakehouse, table formats commonly provide ACID transactions and schema enforcement; a catalog supplies ownership, permissions, discovery and lineage; and separate compute engines serve SQL, streaming, feature engineering and model training.

The architectural goal is a shared source of truth. Raw and curated data can remain in one storage layer while different engines use the same governed tables. This can reduce redundant exports and improve freshness, but it does not remove engineering work: table design, compaction, partitioning, access policies, metadata quality and compute selection still determine the result.

Why AI changes the architecture decision

AI uses more than relational rows

Conventional BI usually starts with clean dimensions and measures. AI projects also need clickstreams, sensor readings, support conversations, PDFs, images, code, embeddings, labels and model outputs. Some of these assets are semi-structured or unstructured, and their schemas evolve as products change. A lakehouse can retain the original objects while exposing normalized tables and vector or feature representations for downstream use.

Training and feature engineering need data proximity

Data scientists repeatedly scan historical records, join labels to events, create point-in-time features and write intermediate datasets. If raw data lives outside the warehouse, each experiment may require a curated export or a separate feature pipeline. Keeping source and refined data in the same governed storage layer lets engineering and ML jobs work from common versions and reduces the chance that a training set differs from the data used in production.

Generative AI needs retrieval and document pipelines

Retrieval-augmented generation (RAG) applications ingest documents, split them into passages, attach metadata, generate embeddings and refresh indexes as content changes. A lakehouse can hold the immutable files, parsed text, chunk tables, embeddings and evaluation results together. A warehouse can participate in the metadata and business-metric side, but a warehouse-only design may require additional object storage and movement for the source documents and model artifacts.

Streaming and freshness are first-class requirements

Fraud detection, recommendations and operational copilots may consume events minutes or seconds after they occur. The choice therefore includes incremental ingestion, late-arriving data, exactly-once or idempotent writes, backfills and feature freshness. A warehouse can support streaming in some products, but if streaming and batch data must be joined with unstructured content and reused for training, a lakehouse usually provides the more direct path.

Warehouse versus lakehouse: decision matrix

Decision axis Data warehouse Data lakehouse
Data types Best for curated structured data and relational BI models. Structured, semi-structured and unstructured data in one governed environment.
AI and ML access Raw or unstructured data outside the warehouse often requires exports or integrations. Models and feature pipelines can work close to raw and curated data.
SQL and BI Mature schema-on-write modeling and predictable SQL serving. Warehouse-style SQL can run on lakehouse tables, but engine choice and tuning matter.
Governance Strong controls inside the warehouse; a separate lake can duplicate policies. Catalog, lineage and access controls can cover data and AI assets together when the platform supports them.
Openness Some products use proprietary storage formats, which can increase switching costs. Open table and file formats can provide more engine choice and portability.
Transactions Database semantics are mature, but vary by product and workload. Table-level ACID behavior and schema controls are common; database-level semantics may differ.
Operations and cost Straightforward for warehouse-only workloads; storing and moving raw data elsewhere adds cost. Fewer copies and pipelines are possible, but lakehouse engineering, governance and compute tuning are required.
Best default Stable structured SQL reporting with no AI or streaming requirement. Mixed data, streaming, ML, generative AI and shared engineering and analytics workflows.

When a traditional warehouse is the better choice

Stable, structured reporting is the whole requirement

Choose a warehouse when every important workload is SQL reporting over governed relational tables, refreshes are predictable and no team needs to train models directly on raw or unstructured data. A warehouse can minimize platform components and keep the operating model familiar to BI administrators and analysts.

Concurrency and metric consistency dominate

If thousands of dashboard queries or scheduled reports must return consistent business metrics, a warehouse’s mature workload management and semantic modeling may be more valuable than lakehouse flexibility. Publish conformed dimensions, certified measures and controlled aggregates rather than asking every dashboard author to interpret raw events.

Regulatory controls are already centered there

Some organizations have years of tested roles, masking rules, audit procedures and retention controls in their warehouse. A move is not automatically safer merely because a lakehouse supports open formats. If AI is limited to a few curated tables, extending the existing warehouse controls may be less risky than introducing a second governance plane.

When a lakehouse should be the primary platform

Multiple data modalities share one AI product

A recommendation engine may combine transactions, clickstream events, catalog text and product images. A support assistant may combine tickets, call transcripts, product manuals and account data. Keeping those inputs in a governed lakehouse avoids creating separate extraction paths for each experiment and application.

Data scientists need raw history and reproducibility

Retain immutable source data and record the transformations that produce training and feature tables. Table versioning or equivalent snapshot mechanisms allow a team to recreate a training set, investigate a model decision and compare a new pipeline with an earlier one. The exact semantics depend on the table format and platform, so document them rather than assuming database-level behavior.

Streaming, batch and backfills must converge

A lakehouse can provide common tables for event ingestion, scheduled transformations and historical backfills. Design for idempotent writes, late data and schema evolution; otherwise, a nominally unified platform can still produce conflicting copies for streaming and batch consumers.

Generative AI must use governed enterprise content

For RAG and agentic systems, governance must cover documents and embeddings as well as rows. Catalog ownership, fine-grained permissions, lineage from source file to chunk and deletion propagation are essential. A lakehouse is appropriate only when those controls are implemented, not simply because files are stored in object storage.

Can a lakehouse replace a data warehouse?

Databricks’ 2026 guidance gives a practical test: a lakehouse can replace a traditional warehouse when a company needs structured, semi-structured and unstructured data on the same platform, or needs machine learning and generative AI to run directly on that data without moving it first. The same guidance says a traditional warehouse can still work when the workload is only structured SQL reporting with no AI or streaming component.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Replacement is therefore a workload decision, not a product-category decision. A lakehouse may provide SQL compute decoupled from storage, ANSI SQL and warehouse capabilities directly on lake data. That can eliminate a separate warehouse for some organizations. It does not guarantee identical SQL dialects, constraints, transaction isolation, indexing behavior or dashboard latency. Validate every dependency before retiring an existing warehouse.

Use a hybrid pattern when responsibilities differ

A common design keeps raw and refined data in open lakehouse tables, runs feature engineering and training against those tables, and publishes a smaller set of warehouse-style marts for high-concurrency BI. SQL-serving compute reads the governed lakehouse tables, while dashboards use stable views and certified metrics. This arrangement avoids copying every dataset while giving analysts a predictable interface.

Hybrid does not mean “duplicate everything.” Define which layer owns each dataset, how often data is refreshed, where business definitions are certified and which system is authoritative for access decisions. Replicate only the aggregates or serving tables that have a clear latency or concurrency reason to exist.

What a production lakehouse must include

Open, durable storage

Keep raw data in durable object storage and use open file and table formats where portability matters. Preserve immutable source objects when legal and operational requirements allow it. Separate raw, validated and curated zones by policy and lifecycle rather than relying on folder names alone.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Reliable table semantics

Use a table format that provides atomic commits, concurrent-read behavior and schema enforcement appropriate to the workload. Delta Lake documentation, for example, describes ACID transactions and schema enforcement. Confirm how deletes, updates, time travel, streaming checkpoints and concurrent writers behave at your chosen scale.

Catalog, lineage and fine-grained access

A catalog should identify owners, classifications, retention rules and approved uses. Fine-grained policies must apply to columns, rows, files and derived AI assets where necessary. Unity Catalog documentation describes unified governance for data and AI; equivalent capabilities from another platform should be evaluated against your actual regulatory controls, not a feature checklist.

Separate compute for different workloads

SQL dashboards, streaming pipelines, feature jobs, ad-hoc notebooks and model training have different resource profiles. Isolate them with workload-specific compute, quotas and scheduling. A shared storage layer does not require a single cluster or a single engine.

Implementation plan: choosing and building the platform

  1. Inventory the workloads. List dashboards, ad-hoc SQL, batch transformations, streaming jobs, feature pipelines, training runs, inference, RAG retrieval and data-science exploration. Record owners, service-level objectives, refresh windows and peak concurrency.
  2. Classify the data. Mark each source as structured, semi-structured or unstructured; identify volume growth, retention, sensitivity, regional residency and schema-change frequency. Note which assets must remain queryable in original form.
  3. Define the serving contracts. Specify certified metrics, feature definitions, embedding refresh rules, acceptable staleness and deletion behavior. Decide which interfaces are SQL views, feature tables, APIs or vector indexes.
  4. Land raw data once where appropriate. Preserve source fidelity in durable storage, assign ownership and attach ingestion metadata such as event time, arrival time, source version and sensitivity classification. Do not call this production-ready until access and retention policies are enforceable.
  5. Add table reliability. Apply schema checks, constraints that your platform supports, ACID commits, idempotent ingestion and controlled schema evolution. Test late events, retries, duplicate messages and partial failures.
  6. Build curated models and marts. Create normalized or dimensional tables for shared business entities. Publish warehouse-style marts for high-concurrency BI, with documented metric definitions and refresh schedules.
  7. Connect AI pipelines to governed tables. Build point-in-time-correct features, training snapshots and document-to-embedding lineage. Ensure model jobs cannot bypass row, column or region restrictions.
  8. Test representative workloads. Use production-like data distributions, file sizes, joins, incremental updates, dashboard concurrency, feature-generation windows, retrieval queries and training scans. Measure freshness, queue time, runtime, failure recovery and reproducibility.
  9. Price the complete system. Include object storage, table metadata, SQL and ML compute, streaming, egress, duplicated copies, orchestration, observability, security reviews and engineering labor. Compare the same retention period and service levels for each architecture.
  10. Document migration differences. Record SQL-dialect changes, null and timestamp behavior, identifier rules, constraints, transaction isolation, update and delete semantics, security mappings and rollback procedures before moving a critical workload.

How to evaluate performance and cost without misleading benchmarks

Measure the workloads users actually run

There is no universal performance or cost winner. A warehouse may excel at repeated star-schema aggregates under high dashboard concurrency, while a lakehouse may avoid expensive exports during feature engineering or document processing. Test the same data volume, refresh frequency, concurrency and result-quality requirements in both designs.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Track end-to-end latency

Measure source arrival to governed-table availability, table availability to feature readiness, and feature or document readiness to model-serving availability. Include queueing, compaction, indexing and orchestration time. A fast query over stale data is not a fast AI system.

Separate storage, compute and movement costs

Count full and incremental copies, temporary training sets, export files, cross-region transfer and repeated scans. Include idle or reserved compute and the operational effort required to tune partitions, file sizes, clustering, caches and workloads. A lakehouse can reduce movement, but poorly managed small files or unrestricted ad-hoc compute can erase that benefit.

Include governance and failure recovery

Test access-policy evaluation, audit-log retention, lineage completeness, deletion requests, restore procedures and backfills. A design that is inexpensive in a prototype may become costly when every AI asset must be discoverable, explainable and removable.

Common pitfalls and how to correct them

Calling an object-storage folder a lakehouse

Files alone do not provide transactions, schema enforcement, lineage or consistent permissions. Add a managed table format, catalog and policy layer before allowing critical BI or AI workloads to depend on the data.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Assuming open formats remove all lock-in

Open files improve portability, but engines still differ in SQL syntax, optimization, metadata services, security models and transaction semantics. Keep a compatibility test suite and document platform-specific features used by each pipeline.

Moving every dataset into a warehouse “for simplicity”

This can create large export pipelines, duplicate storage and slow access to raw or unstructured data. Keep source assets where they are most useful, then publish only the curated tables and aggregates that need warehouse-style serving.

Putting every query on shared compute

Training scans, streaming jobs and dashboard bursts can interfere with one another. Use workload isolation, quotas, scheduling and autoscaling; monitor queue time as well as execution time.

Ignoring data and model governance

An AI system can leak restricted content even when the source table is protected. Propagate permissions to chunks, embeddings, features, training snapshots and model outputs. Log who accessed which version and how deletions flow through derived assets.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Benchmarking only a clean, small sample

Small files, skewed keys, realistic late data, peak concurrency and schema evolution often expose the real bottlenecks. Re-run tests after compaction, retention and backfill policies are enabled.

Recommendations by organization profile

Your situation Practical starting point Why
Only structured finance, sales and operations reporting Warehouse, with disciplined dimensional modeling and governance. Minimizes moving parts and favors predictable SQL concurrency.
Existing warehouse plus growing ML experiments Add governed lakehouse storage for raw and feature data; keep certified marts in the warehouse or SQL-serving layer. Lets ML access richer data without disrupting established BI.
Streaming events, real-time features and batch history Lakehouse as the shared data and engineering layer, with specialized serving stores where latency requires them. Unifies streaming, backfills and training inputs.
Document-heavy generative-AI applications Lakehouse with cataloged files, parsed text, embeddings, retrieval indexes and strict derived-asset governance. Keeps source content and AI transformations together.
Large analyst population with strict dashboard SLAs Hybrid: lakehouse for storage and AI, curated marts and isolated SQL compute for BI. Balances shared data with predictable serving performance.
Highly regulated data across regions Choose the platform whose catalog, residency controls, audit trail and deletion semantics pass a proof of concept; do not infer compliance from architecture labels. Governance capability and operating procedures matter more than the name of the pattern.

Bottom line: let the workload decide

Use a data warehouse when your world is stable, structured SQL reporting and the warehouse already provides the governance and concurrency you need. Use a lakehouse when AI must work directly with mixed data, streaming inputs, raw history or enterprise documents. In many enterprises, the most durable answer is a hybrid: one governed lakehouse foundation, warehouse-style curated marts and isolated serving compute for the users who need predictable SQL.

Make the decision with a proof of concept that includes realistic concurrency, freshness, feature engineering, retrieval, training, access policies, deletion and recovery. Platform claims are directional; your data distribution, contracts, team skills and governance obligations determine the result.
