Authorities and traders are using machine learning for risk targeting, anomaly detection, fraud detection, document processing and workflow decisions. The gains can be substantial, but an AI output is not automatically a lawful customs decision: poor data, unexplained models, weak security or missing human review can create new compliance failures.
Why customs compliance now depends on AI and data
Modern customs systems process large volumes of declarations, shipment records and entity information while trying to identify a small number of high-risk transactions. Traditional rules remain essential, but fixed rules cannot efficiently capture every changing relationship, anomaly or fraud pattern. Machine-learning systems can examine more variables, update risk scores and help officers focus scarce inspection resources.

The World Customs Organization (WCO) described this shift in its report on artificial intelligence and machine-learning adoption in customs, published on 28 March 2025. The report covers operational efficiency, trade facilitation, risk management, intelligence, predictive analytics, real-time processing, workforce capability, legal and ethical requirements, data management, infrastructure, cybersecurity, interoperability, data protection, MLOps, fairness, transparency and accountability.

The WCO Smart Customs Project’s 2024 survey received 116 submissions, representing 62% participation from WCO Members. Ninety-two percent of respondents reported having an IT strategy, but the same release identified continuing needs in technical skills, cybersecurity awareness, IT policy and governance, and strategic planning and change management. Adoption is therefore uneven: an administration may have an AI pilot while still lacking the data, people or controls needed for broad deployment.

What customs AI is used for
Risk selectivity and targeting
AI can rank declarations, shipments or entities by estimated risk so officials can decide where to apply documentary checks, physical inspections or post-entry review. The European Commission defines customs risk management as the systematic identification, assessment and prioritisation of risks followed by coordinated controls, with the aim of targeting intervention while facilitating legitimate trade. AI supports that process; it does not replace the legal risk framework.
Anomaly detection
Anomaly models look for transactions that differ from normal patterns, such as unusual combinations of tariff information, values, origins, routes or parties. The WCO reported in 2025 that its 2023 Risk Management Compendium added anomaly-detection and data-cleaning methods, along with AI case studies involving customs data and insider threats.
Fraud and revenue-risk detection
Models can surface relationships that are difficult to see manually, helping investigators examine possible undervaluation, misdescription, irregular trading networks or other revenue risks. A high score is an investigative lead, not proof of wrongdoing. False positives consume inspection and enforcement capacity; false negatives can allow prohibited goods or lost revenue through.

Classification and document support
Natural-language systems can extract fields from invoices and other trade documents, suggest tariff classifications and flag missing or inconsistent information. Classification remains legally consequential, and the evidence does not establish a universal accuracy level at which AI can make binding decisions without review. A broker or compliance professional should verify the suggested code, explanatory notes, origin and valuation treatment before a declaration is submitted.
Resource allocation and process automation
AI can prioritize queues, predict workload, route cases to specialists and automate repetitive data handling. The WCO executive summary says these capabilities can automate routine processes, improve risk assessment and fraud detection, optimize resources and streamline clearance.
An operational example already exists
U.S. Customs and Border Protection (CBP) Acting Commissioner Pete Flores described an existing trade-mission use case: “Within the trade mission, AI helps us identify shipments and entities that pose a greater risk, and at an earlier point in time.” He also connected AI and analytics with investigations, revenue recovery, network analysis and assessing trade-disruption impacts. This is decision support and targeting, not a statement that every CBP decision is made autonomously.

The data foundation determines whether a model works
Better algorithms cannot compensate for incomplete, inconsistent or incorrectly labelled customs data. A pilot should identify the fields that drive the decision and test their quality before model selection.
- Declaration data: tariff information, descriptions, quantities, values, origin and other fields used in clearance.
- Shipment and entity data: parties, routes, transaction histories and relationships needed to identify patterns.
- Outcome labels: inspection findings, confirmed errors, post-entry corrections or other documented results that show whether a risk signal was meaningful.
- Data controls: definitions, ownership, retention, access permissions, correction procedures and audit trails.
Data from different customs, port, broker and trader systems may use incompatible formats. Interoperability and data cleaning are therefore part of the compliance project, not an afterthought. Sensitive commercial and personal information also requires privacy controls, encryption, access management and a documented lawful basis for use.

How to keep AI decisions legally defensible
Customs authorities and importers should be able to explain what an AI system was intended to do, which data it used, how a result was reviewed and who made the final decision. The WCO’s 2023 generative-AI policy note anticipated progressive adoption by customs administrations and private stakeholders while highlighting legal, workforce and governance implications.
- Legal authority: confirm that the agency or company is permitted to collect, combine and use each data source for the stated purpose.
- Human accountability: assign an accountable official or compliance owner; a model score must not become an unreviewable denial, seizure or penalty.
- Transparency: record the model’s purpose, material inputs, version, thresholds, limitations and override process.
- Fairness testing: check whether proxies for nationality, location, company size or other characteristics create unjustified disparate treatment.
- Security: protect training data, interfaces, credentials and outputs against leakage, manipulation and adversarial attacks.
- Monitoring: detect data drift, changing fraud patterns, degraded performance and unexplained changes in false-positive or false-negative rates.
Explainability does not require publishing sensitive detection rules. It does require an internal, reviewable record sufficient to support an appeal, audit, supervisory inquiry or post-entry challenge.

Choose the approach for the risk, not the marketing label
| Approach | Best fit | Strength | Main limitation | Human role |
|---|---|---|---|---|
| Rules and thresholds | Stable, clearly defined requirements | Highly transparent and easy to audit | Misses new or complex patterns and requires frequent rule maintenance | Set rules, review exceptions and update them when law or risk changes |
| Supervised machine learning | Risk scoring where reliable historical outcomes exist | Can rank large volumes using many variables | Performance depends on representative labels; drift can reduce accuracy | Validate labels, review scores and investigate errors |
| Anomaly detection | Previously unseen or unusual behavior | Can identify patterns without a complete fraud label set | Unusual does not necessarily mean unlawful; false positives can be high | Examine the context and document the reason for intervention |
| Generative AI and document extraction | Reading, summarizing and routing trade documents | Reduces repetitive data entry and speeds triage | Can hallucinate, omit fields or suggest an incorrect classification | Verify every material field before filing or enforcement action |
No general implementation cost or accuracy figure is established for these approaches. Costs depend on data remediation, integration with customs systems, security controls, specialist staffing and ongoing MLOps.
Best Value
A defensible importer pilot: from question to controlled deployment
- Define one measurable problem. Examples include reducing manual document triage time, improving identification of a known valuation anomaly or prioritizing post-entry reviews. Avoid a vague objective such as “use AI for compliance.”
- Set the decision boundary. Specify whether the system recommends, routes, flags or automatically performs an action. Keep legally consequential decisions under authorized human control during the pilot.
- Inventory and clean the data. Document sources, owners, retention, missing values, duplicate records, historical changes and access rights. Do not train on data whose use has not been legally reviewed.
- Establish a baseline. Measure current processing time, review volume, confirmed findings, false positives and false negatives where those outcomes are available.
- Run an offline evaluation. Test historical or holdout cases, including difficult edge cases and changes in tariff, supplier or route patterns. Compare the model with the existing rules and with qualified human reviewers.
- Complete legal, privacy and security review. Check authority, data protection, cybersecurity, vendor access, retention, explainability, appeal rights and records-management requirements.
- Deploy in a limited workflow. Start with one port, business unit, commodity group or document queue. Log every recommendation, override, user, model version and outcome.
- Monitor and decide whether to scale. Track precision, missed risks, review burden, processing time, disparate impacts, data drift and incident reports. Scale only when the cost-benefit case remains positive and controls operate in practice.
Will AI replace customs brokers and compliance teams?
Evidence to date points to task transformation rather than elimination. Automation can handle extraction, queue management and routine comparisons, while specialists remain responsible for classification judgment, valuation and origin analysis, exception handling, legal interpretation, investigations and communication with authorities. The WCO identifies workforce capability as a core adoption issue; training in technical skills, cybersecurity, governance and change management is as important as purchasing software.
What to check before buying customs AI
- Can the supplier show performance on data that resembles your commodities, jurisdictions and declaration processes, rather than a generic benchmark?
- Can you export the input, output, model version, threshold and human override for an audit?
- Where is data processed, who can access it, how long is it retained and can it be used to train another model?
- How does the system integrate with existing customs, enterprise-resource-planning and broker workflows?
- What happens when the model is uncertain, unavailable or wrong?
- What monitoring, retraining, incident response and change-control services are included?
A generic AI product without validated customs data, legal review and continuous monitoring can increase risk while appearing to modernize compliance. A bounded use case with clear ownership and measurable outcomes is the safer starting point.
The practical takeaway
Customs compliance is becoming an AI problem because both authorities and traders must manage decisions produced from large, changing data sets. AI can improve targeting and speed, but defensibility still rests on accurate declarations, lawful data use, explainable processes, cybersecurity, human accountability and monitoring. Begin with one narrow pilot, prove its value against a documented baseline and expand only when the controls are as mature as the model.
