Cloud AI Inference Explained: GPUs, Tokens, Latency, and Pricing

Cloud AI inference is the production step that turns a trained model into an on-demand service. A request is queued, tokenized, processed on accelerator-backed servers, and returned as generated output. Your real cost and user experience depend on the model, prompt and response lengths, GPU capacity, caching, concurrency, region, and service tier—not on a single universal “AI inference price.”

What cloud AI inference does

Training adjusts a model’s weights; inference uses those fixed weights to answer a request. In a cloud service, the serving path normally looks like this:

As an Amazon Associate I earn from qualifying purchases.

  1. Request arrival: An API gateway authenticates the call, applies quotas, and may place it in a queue.
  2. Tokenization: Text, code, images or other inputs are converted into the model’s internal representation. For language models, text is split into tokens rather than processed as whole words.
  3. Prompt processing (prefill): The model reads the entire input context and computes the intermediate attention state needed for generation.
  4. Autoregressive generation: The model predicts output one token at a time. Each new token uses the prior context and the stored key-value (KV) cache.
  5. Streaming or completion: The service sends tokens as they become available, or waits and returns the completed response.

GPUs are useful because these operations contain large numbers of parallel tensor calculations. They also provide high-bandwidth memory for model weights and the growing KV cache. A longer prompt, a larger model, a larger context window, or more simultaneous users increases memory and compute pressure.

Why “cloud” changes the engineering problem

A cloud endpoint can pool hardware across customers, add capacity elastically, and expose several models through one API. You avoid installing drivers and serving software, but you accept provider quotas, regional availability, model-retention policies, and less control over scheduling and hardware. Renting GPU instances gives you more control, but you become responsible for deployment, capacity planning, autoscaling, patching, monitoring, and failures.

Tokens are both a model input and a billing unit

A token is a piece of the model’s vocabulary. Common words may map to one token, while punctuation, word fragments, code, or non-English text can use several. The exact count depends on the model’s tokenizer. Providers therefore measure at least two quantities:

  • Input tokens: system instructions, conversation history, retrieved documents, tool definitions, and the current user prompt.
  • Output tokens: the generated answer, including any hidden or visible structured output counted by that service.

Input and output are often priced at different rates. A request with a small answer can still be expensive when it repeatedly sends a large system prompt or document set. Conversely, a short prompt that produces a long completion consumes mostly output tokens. Check whether a provider counts cached prompts, tool calls, images, or reasoning tokens under separate rules.

The basic cost equation

For a token-priced endpoint, estimate each request or billing period with:

cost = (input_tokens / 1,000,000 × input_rate) + (output_tokens / 1,000,000 × output_rate) + cache, batch, regional, storage, network, and platform charges

Multiply the per-request result by your traffic distribution, not by an average request that hides outliers. Keep input and output distributions separate; a service with a low input rate may still be costly for long generations.

Pricing features that change the bill

Feature How it affects a workload
Input and output rates Providers commonly publish separate prices per million tokens for each direction and model.
Prompt or implicit caching Repeated prefixes can be cheaper and faster when the service recognizes a cache hit. Google Vertex AI documents implicit caching and provisioned-throughput scale units; cache hits can reduce both cost and latency.
Batch inference Asynchronous jobs trade immediate response time for lower unit cost. AWS states that select Bedrock batch-inference prices can be 50% lower than on-demand pricing; verify the model and region that qualify before budgeting.
Latency-optimized or reserved capacity A higher service tier or provisioned capacity can improve predictability while changing the effective rate.
Regional processing Data-routing choices can add a surcharge. OpenAI documents a 10% regional-processing uplift for eligible models released on or after March 5, 2026.
Network, storage and platform charges Large documents, private networking, logging, vector retrieval, and egress can add costs outside the token line item.

Rates, model catalogs, quotas, and eligibility change frequently by region and tier. Recheck the provider’s current pricing page when you commit to a design; do not carry a price from one model or geography to another.

Do you need a GPU for inference?

You do not need to own a GPU to call a managed API. The provider supplies the accelerator. You do need to reason about GPU resources when selecting a hosted endpoint or running a model yourself, because memory and compute determine whether the model fits and how many users it can serve.

Inputs to a GPU decision

  • Model size: More parameters require more memory. Quantization can reduce memory use, but may affect quality or compatibility.
  • Context length: The KV cache grows with the prompt and generated history. Long-context conversations can exhaust memory even when the model weights fit.
  • Concurrency: Simultaneous requests compete for memory bandwidth and compute. Capacity that handles one request quickly may perform poorly for dozens.
  • Latency target: Interactive applications need predictable TTFT and token cadence, not merely high total throughput.
  • Utilization and traffic shape: Bursty traffic may favor elastic APIs; steady traffic can make dedicated instances economical.
  • Data and deployment constraints: Residency, private networking, retention, and an approved runtime can rule out some services.

Managed API versus rented or self-managed GPUs

Approach Strengths Trade-offs
Managed model API Fast integration, elastic capacity, and access to multiple models without operating servers. Provider-specific model availability, quotas, regional restrictions, token pricing, retention terms, and limited control of batching or runtime internals.
Rented GPU instance Control over GPU type, model placement, quantization, batching, networking, and data locality; attractive for sustained predictable traffic. You must plan capacity, deploy and update the serving stack, autoscale, monitor utilization, and handle failures. Idle capacity still costs money.
Self-managed hardware Maximum control over data path and scheduling when utilization is high and hardware is already available. Up-front capital, hardware lifecycle work, power and cooling, limited elasticity, and responsibility for every operational layer.

Compare a GPU instance with an API only after converting both to the same denominator: delivered tokens at a stated prompt length, output length, concurrency, latency target, and quality level. A GPU-hour advertisement is not an inference cost by itself.

Latency: TTFT, ITL and end-to-end time answer different questions

“Latency” is not one measurement. Record the following separately:

Time to first token (TTFT)

TTFT is the delay from request submission until streaming begins. It includes queueing, prompt processing (prefill), and network effects. A longer prompt generally increases TTFT because the service must read the full context and create the KV cache before it can emit the first token. TTFT is the metric users feel as “How long until the answer starts?”

Inter-token latency (ITL)

ITL, also called time per output token, is the average delay between consecutive generated tokens after the first one. It describes the smoothness and speed of a streaming answer. Two systems can have the same TTFT but very different ITL, making one answer appear to race ahead while the other trickles out.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

End-to-end latency

End-to-end latency runs from request submission to the final token. NVIDIA expresses it as end-to-end latency = TTFT + generation time. Generation time depends on output length and the system’s token-generation rate, so never compare end-to-end results without matching response sizes.

Time to last token at the gateway

Microsoft Azure’s TTLT metric measures from prompt submission to the last token observed at the API gateway. A five-second TTLT can represent very different experiences for a 50-token answer and a 2,000-token answer. Pair TTLT with output-token count and ITL to make the result interpretable.

Throughput and concurrency

NVIDIA’s GenAI-Perf documentation defines system TPS as total output tokens divided by the elapsed benchmark interval. Aggregate TPS usually rises as concurrency increases until GPU resources saturate; beyond saturation, throughput can decrease. Per-user TPS generally falls as concurrency grows because requests wait or share bandwidth. Report concurrency, prompt length, output length, and percentile latency with every throughput number.

How to compare providers or architectures

Use the same workload and score each option on six dimensions:

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.
  1. Interactive latency: Compare p50 and p95 TTFT and ITL, plus p95 end-to-end latency. Averages hide queueing spikes.
  2. Throughput: Measure output tokens per second at the concurrency and prompt/output lengths that match production.
  3. Economics: Include input and output token rates, cache-hit rate, batch discounts, idle GPU time, network and platform fees, and any regional surcharge.
  4. Capacity and reliability: Check quotas, regional availability, autoscaling behavior, rate-limit responses, retry safety, and failure handling.
  5. Model and data constraints: Confirm model quality, context window, residency, private networking, retention, and logging policies.
  6. Operational control: Decide whether API simplicity or control over GPU type, runtime, quantization, batching, and deployment matters more.

NVIDIA’s provider-selection guidance summarizes the decision this way: “the underlying hardware, per user interactivity measured in tokens per second per user, cost per million tokens, latency and time-to-first-token, model diversity, and whether the provider has capacity to support workload growth.” Treat those as evaluation fields, not marketing slogans.

A practical benchmark and sizing procedure

Build a workload sheet before choosing a service. Record requests per minute, input-token and output-token distributions, peak concurrency, model and context length, region, latency SLO, uptime target, and expected growth.

  1. Prepare representative prompts: Include short and long contexts, normal and worst-case outputs, tool calls, retrieved documents, and the languages your users actually send.
  2. Define success criteria: Set acceptable p50 and p95 TTFT, ITL, end-to-end latency, error rate, answer quality, and monthly budget.
  3. Test several concurrency levels: Start below expected peak, then increase until queueing or GPU saturation appears. Include a burst test for sudden traffic.
  4. Measure the full path: Capture request time, TTFT, every-token timestamps, final-token time, successful requests per second, HTTP errors, retries, and timeouts.
  5. Collect serving signals: For GPU deployments, record utilization, memory use, KV-cache pressure, batching behavior, and autoscaling events. For APIs, record quota responses and cache-hit rate when exposed.
  6. Calculate delivered-token cost: Apply actual input and output counts, cache behavior, batch or regional pricing, instance uptime, and supporting services.
  7. Repeat across regions or tiers: Capacity and latency can differ even when the model name is identical.
  8. Size with headroom: Provision or rent capacity from the observed saturation point plus enough margin for bursts, failures, and growth; then compare that result with token-priced API estimates.

Do not substitute a provider’s advertised benchmark for your own workload. The available data of measurements should let you explain why a choice meets both the user experience and the budget.

Common comparison mistakes and how to avoid them

  • Using one average latency: Report p50 and p95 TTFT, ITL, and end-to-end latency. Tail queueing is often what users notice.
  • Comparing unlike responses: A 50-token completion cannot be fairly compared with a 2,000-token completion without normalizing output length.
  • Ignoring the prompt: Repeatedly sending a large history raises input cost and TTFT. Use compact state or supported caching where it preserves quality.
  • Equating GPU-hour price with token price: Convert instance uptime, utilization, and delivered tokens into an effective cost per token.
  • Assuming maximum concurrency is free: Aggregate throughput may improve while each user’s token rate and latency worsen after queues form.
  • Overlooking quotas and regional capacity: A low list price is irrelevant if your region cannot supply peak capacity or your quota requires a lengthy increase request.
  • Counting only the model call: Retrieval, storage, logging, private networking, egress, retries, and orchestration can materially change total cost.
  • Optimizing latency without quality checks: Quantization, shorter contexts, early stopping, or a smaller model can change answer quality and task success.

Which deployment fits your workload?

Choose a managed API when

  • You need to ship quickly and do not want to operate GPU infrastructure.
  • Traffic is irregular or experimental, so elastic capacity is more valuable than fixed utilization.
  • You need to switch among several hosted models and can accept provider quotas and policies.
  • Your team can meet residency, retention, and networking requirements within the provider’s available regions and tiers.

Choose rented or self-managed GPUs when

  • Traffic is sustained and predictable enough to keep accelerators busy.
  • You require control over model weights, quantization, batching, runtime, networking, or data locality.
  • You can operate deployment, autoscaling, observability, patching, and incident response.
  • Your measured cost per delivered token beats the API alternative at the required latency and quality.

Use a hybrid design when

Many teams keep a managed API for bursts, fallback, or frontier models while serving a stable, high-volume path on dedicated GPUs. Route by task, latency SLO, data sensitivity, or capacity rather than assuming one endpoint is optimal for every request. Re-evaluate the split when model prices, cache behavior, hardware availability, or traffic patterns change.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

The practical takeaway

Cloud inference is a serving system, not merely a model endpoint. Tokens determine much of the bill, GPUs determine how computation and memory scale, and TTFT, ITL, and end-to-end latency describe different parts of the user experience. Build a workload-specific benchmark, measure at realistic concurrency, include every supporting charge, and compare managed APIs with GPU capacity using delivered tokens under the same latency and quality constraints.
