500 Million Vectors: How to Choose a Scalable Search Architecture

Scaling to 500 million vectors depends on dimensions, recall, workload, filters, and budget—not vector count alone. Compare index and deployment patterns, then benchmark the real workload.

There is no single architecture—or reliable RAM estimate—for searching 500 million vectors. The right design depends on vector dimensions and encoding, target recall, query rate and concurrency, latency goals, update and filter patterns, and the budget for memory, SSDs, networking, and operations. In practice, teams compare an in-memory graph, a partitioned and often quantized index, and an SSD-backed graph, then decide whether one machine can meet the workload or the logical index must span a fleet.

How do you scale vector search to 500 million vectors?

Start with the search requirement, not the vector count. Exact nearest-neighbor search compares a query with every qualifying vector. Approximate nearest-neighbor (ANN) indexes search a smaller set of likely candidates, reducing work as a collection grows but potentially missing the true nearest result. The design is acceptable only if it meets the application’s recall target at the required latency and load.

Separate two decisions that are often conflated: the index algorithm determines how candidates are found and stored; the deployment topology determines whether that index lives on one node or is distributed across machines. A fleet does not automatically solve an unsuitable index, and choosing an SSD-backed index does not by itself make the system distributed.

Three index patterns to evaluate

Pattern How it searches When it may fit Questions to test
In-memory HNSW graph Traverses a graph-based index held in memory. When the graph and vectors fit with operating headroom and low latency or high recall matters. Azure DocumentDB’s guidance positions HNSW for its service when maximum recall is the priority; that is service-specific guidance. What is recall at target concurrency? Can vectors, graph, metadata, and working memory fit? How long do builds and updates take?
IVF, often with compressed codes Partitions vector space into lists and searches selected lists; product quantization can reduce stored representation size. When compression and scan tuning suit the quality and resource constraints. Azure DocumentDB positions IVF for development, demos, and smaller clusters, a recommendation specific to that service. How many lists and probes meet the recall target? What training and rebuild work is required? What is measured storage per vector?
DiskANN or another SSD-backed graph Uses graph navigation with SSD-backed storage to reduce dependence on keeping the full index in DRAM. When a large collection makes memory the constraint and the workload tolerates SSD access. Measure random-read behavior, I/O saturation, SSD capacity and endurance, recall, build time, and tail latency.

These are design families, not interchangeable product settings. FAISS documents graph, IVF, flat, and quantized index options; actual memory use and search behavior depend on the selected implementation and configuration.

One node or a distributed logical index?

A single-node design avoids cross-machine routing and coordination, but all relevant index state and workload must fit the machine’s resource envelope. A distributed logical index can spread storage and throughput across a fleet, but adds network traffic, routing, failure handling, replication, consistency, and operational cost.

Microsoft Research’s 2025 DistributedANN description reports a single 50-billion-vector graph spread across more than a thousand machines, built from a distributed key-value store plus an in-memory ANN index. The reported system achieved 26 ms median query latency and more than 100,000 queries per second. Its paper also reports 6x greater efficiency than the partitioning and routing strategies it evaluated. These are results for that evaluated system and comparison, not a node-count or performance forecast for a 500-million-vector deployment.

For illustration, 500 million 1,536-dimensional vectors stored as 32-bit floating-point values require 3.072 trillion bytes (about 3.07 TB or 2.79 TiB) for vector values alone. This is arithmetic for that stated representation, not a deployment estimate. It excludes index structures, IDs, metadata, replicas, allocator overhead, query-time working memory, and spare capacity.

Compression changes the vector-code payload, but does not make all other storage disappear. Index-specific overhead can also be material: FAISS documents a 256-byte-per-vector link overhead for its described HNSW32 configuration, and an 8-byte-per-vector ID baseline for the cited IVF configuration. At 500 million vectors those examples correspond to about 128 GB and 4 GB respectively, before other index data and implementation-specific overhead. They are configuration examples, not universal constants or complete index-size estimates.

Therefore, “500 million vectors” alone cannot establish a RAM requirement. Dimensions, numeric type or quantization, graph or partition structure, metadata, replication, and required operating headroom all matter. An SSD-backed design shifts some storage demand away from DRAM; it does not remove the need to budget for RAM, SSD I/O, and the rest of the index.

Reported result Context and interpretation
More than 5,000 queries per second, under 3 ms mean latency, and above 95% 1-recall@1 Microsoft Research’s 2019 DiskANN paper reports these results on a 16-core machine using the billion-point SIFT1B benchmark. 1-recall@1 is a specific top-result recall measure; the result is not a general QPS or latency guarantee.
5–10x more points per node The same 2019 paper gives this comparison for DiskANN in the high-recall regime against the graph-based methods described in that paper. It is not a universal capacity multiplier.
64 GB RAM and an SSD Microsoft Research’s 2019 paper describes indexing and searching one billion points on one workstation with 64 GB of RAM and an SSD. The paper’s setup demonstrates an SSD-backed approach; it does not establish the hardware needed for other dimensions, data, or service targets.
26 ms median latency and over 100,000 queries per second Microsoft Research’s 2025 DistributedANN results for its reported distributed system, not a benchmark for an arbitrary 500-million-vector fleet.

Mean latency is not a substitute for p95 or p99 latency, and a high global recall result does not guarantee quality after selective metadata filters. The cited studies do not establish a typical industry cost or performance figure for a production deployment of 500 million vectors.

How should you benchmark a candidate design?

Use a representative corpus and query set, and compare candidates under the same conditions. If feasible, compute exact-search ground truth for a representative sample and measure ANN recall against it. For filtered workloads, measure recall under the actual predicates rather than relying only on unfiltered recall.

  1. Specify the workload. Record dimensions, representation, distance metric, result count, query distribution, filters and their selectivity, insert/update/delete rates, target recall, expected concurrency, and latency objectives.
  2. Build a representative sample. Preserve the real vector and metadata distributions. Treat extrapolation from a smaller sample to 500 million vectors cautiously; index overhead and operating behavior may not scale linearly.
  3. Compare tuned index candidates. For each option, record recall, p50/p95/p99 latency, throughput at realistic concurrency, CPU and memory use, vector/code/graph/metadata storage, and SSD I/O where applicable.
  4. Test lifecycle and failure cases. Measure index build, update freshness, deletion behavior, recovery and rebuild time, and behavior under cold and warm cache conditions. Verify filtering correctness and filtered recall.
  5. Evaluate the deployed shape. Test the intended machine or fleet, including routing, network traffic, replication, failure handling, and operating cost. Keep the corpus, query mix, and settings documented so comparisons remain meaningful.

What changes in managed services?

Managed database products can make indexing and search easier to operate, but their defaults, limits, and availability apply only to that product and configuration. Azure DocumentDB’s official guidance compares DiskANN, HNSW, and IVF, and covers cosine, L2, and inner-product metrics. It recommends DiskANN for its production default, HNSW when maximum recall is the priority, and IVF for development or smaller datasets; its cluster and dimension limits are service-specific.

Microsoft announced general availability of its DiskANN vector index and search on September 29, 2026, across Azure SQL Database, Azure SQL Managed Instance with the always-up-to-date update policy, and SQL database in Microsoft Fabric. The vendor describes inserts, updates, deletes, iterative filtering, and optimizer selection between exact and approximate search, and says its episode demonstrates one billion vectors in Azure SQL Database Hyperscale. Treat the billion-vector example as a vendor demonstration, not independent benchmarking; confirm current availability and limits for the exact service, region, and configuration you plan to use.
