You Changed the Embedding Model and Kept the Old Vectors: What to Do Next

Embedding vectors are model-specific. If you changed query models but kept old document vectors, regenerate the corpus, validate retrieval, and switch only when the new index is ready.

If you changed the model that embeds search queries but left document vectors generated by the old model in place, don’t assume search results are still meaningful. Embeddings are model-specific representations. The usual fix is to regenerate document embeddings from the source text or chunks, validate retrieval with the new representation, and switch queries only when the replacement index is ready.

Why old vectors may no longer work with the new model

An embedding model maps text into a vector space whose structure reflects that model’s training and configuration. A query vector from a new model and a document vector from an old model may have the same number of dimensions yet encode meaning differently. Nearest-neighbor comparisons between them therefore cannot be presumed to preserve relevance.

MongoDB’s Voyage AI migration documentation says to regenerate the entire corpus so stored and query vectors come from the same model. It explicitly recommends regeneration even when the old and new vectors have matching dimensions and element types: MongoDB’s embedding-model migration guide.

Changing only the query encoder is thus a compatibility change, not a routine configuration edit. Matching vector lengths satisfy a schema requirement; they do not demonstrate that the two models share semantic geometry.

What to do before switching production search

1. Recover the source text

Confirm that you still have the original documents or the exact chunks used to create the old embeddings. A vector is not a substitute for its input text: in the normal migration, the new model must embed that text again. If you cannot reconstruct the source, you cannot reliably regenerate equivalent document representations from the vectors alone.

2. Pin the replacement model and configuration

Record the model identifier and relevant configuration for each representation, including its expected dimensions. OpenAI’s backward-compatibility guidance recommends pinned model versions for more consistent behavior, but addresses API and model behavior generally; it does not say embeddings from different models are interchangeable: OpenAI’s backward-compatibility guidance.

  • From Sandisk, a brand professional photographers trust to take on assignments.

3. Check the target schema and migration path

Make sure the destination field or index can store the successor model’s output dimensions and that your database and deployed version support the migration approach you intend to use. For example, MongoDB’s guide calls for configuring the new index with the successor model’s dimension. Whether you can add another vector field, use a named vector, or need a separate index depends on the platform and deployment.

4. Backfill document vectors with the new model

Re-embed the retained corpus and write each new vector to the new representation. Batch the work and monitor it according to your provider’s and database’s limits. Regeneration can incur additional embedding costs; MongoDB’s documentation notes this but does not state a universal amount. Cost and duration depend on your corpus, model, and infrastructure.

  • Always Fast: No slowdowns for large file transfers. With SLC caching (25% of current available capacity allocated as high-speed cache), this external SSD delivers steady 10Gbps for transfers within the cache capacity

5. Keep incoming changes consistent

During the backfill, ensure new documents and changes are also represented with the successor model. Otherwise, the replacement index may be complete for older records but stale or incomplete for current ones. Use the database’s documented migration mechanism where available.

6. Evaluate retrieval on your own data

Test the new representation against a representative set of real queries and inspect whether relevant documents appear where expected. Compare the old and new paths using application-specific relevance or recall checks, and include important edge cases. The cited vendor guides do not establish a universal acceptance threshold, cost, latency, or quality improvement; decide cutover criteria for your application before switching.

New collection or blue-green index Qdrant documents a separate collection migration when its named-vector route is unavailable. Qdrant migration guide Provides a distinct representation and rollback boundary, but requires parallel data and index work during migration. Infrastructure cost depends on the deployment.
Additional named vector Qdrant documents adding a second named vector for eligible named-vector collections on version 1.18 or later, backfilling it, switching queries, and then deleting the old vector. Qdrant migration guide Can avoid a second collection, but depends on the existing schema and deployed version.
Managed automated embedding MongoDB documents changing the model in its automated embedding index configuration and regenerating the embeddings. Queries can continue against the old index definition while rebuilding. MongoDB migration guide Reduces application-managed embedding work, but still requires checking schema, deployment constraints, rebuild behavior, and additional embedding costs.
Self-managed embedding MongoDB’s self-managed path regenerates vectors from corpus data and writes them to a suitable field and index. MongoDB migration guide Gives more control over backfill and validation while leaving consistency, retries, and cutover to your application.

Why a parallel migration can reduce cutover risk

Building the new representation alongside the old one lets you backfill and validate before routing all production reads to it. The exact mechanism is platform-specific: Qdrant documents either a second named vector under its stated version and schema conditions or a new collection; MongoDB documents keeping queries on the old index definition while automated regeneration runs; Zilliz Cloud documents moving search to a new vector field after migration and validation.

Parallel operation is not free of trade-offs. It means managing two representations temporarily, and the database may have platform-specific requirements for writes, indexing, or rebuilding. Check those requirements before choosing a cutover plan rather than assuming all systems support the same sequence.

Can you keep the old vectors if dimensions match?

Matching dimensions alone are not evidence of cross-model compatibility. MongoDB’s migration guidance specifically recommends regenerating even when dimensions and element types match. Treat vectors from distinct models as separate representations unless the relevant platform or model documentation explicitly establishes otherwise.

What not to infer from a model change

  • Do not infer relevance from valid vector shape. A database accepting the vector does not show that cross-model nearest-neighbor ranking is sound.
  • Do not assume a universal rebuild cost or outage. The cited guides describe migration behavior, not a general cost, duration, or downtime figure.
  • Do not delete the old path as soon as backfill ends. Validation and a stable production cutover should come first if rollback matters.
