If a problem’s running time grows exponentially, if much of the program is serial or communication-bound, or if memory movement and power dominate, adding processors delivers sharply smaller gains. The remedy may be a better algorithm, a different architecture, less data movement, or an approximation rather than another hardware upgrade.
First identify the bottleneck: machine or problem
Performance has two very different ceilings. A hardware bottleneck means the program has enough independent arithmetic work, keeps processors busy, and spends most of its time computing. Faster CPUs, GPUs or additional nodes can then reduce elapsed time substantially.

A problem bottleneck comes from the work itself: the algorithm performs too many operations as the input grows, essential steps must run in sequence, processors spend time exchanging data, or moving data costs more energy and time than calculating on it. More hardware attacks none of those limits directly.
Consider an algorithm whose work doubles repeatedly as the input expands. Even if each processor becomes faster, the required work can soon outgrow any practical machine. This is why asymptotic growth matters: the growth rate determines how much larger a problem can become within a fixed time, not the speed of one particular computer.

Why hardware gains stopped being a universal answer
Clock speed met a power wall
The National Research Council reported that rising clock speeds ran into power limits and that architectural improvements began producing diminishing returns. Its 2011 forecast contrasted roughly 100-fold performance growth per decade before 2004 with about twofold growth per decade afterward. The report concluded that “the end of dramatic exponential growth in single-processor performance marks the end of the dominance of the single microprocessor in computing.”
Power is also a system-level constraint. Supplying and removing heat from a large machine can limit useful throughput before its theoretical compute capacity is reached. The same report warned that computing-system performance, including parallel systems, would become limited by power consumption within a decade.

Parallel hardware needs parallel work
Adding processors helps only when the workload can be divided into sufficiently large, mostly independent pieces. A serial section becomes a fixed delay that every run must wait for. Synchronization, network transfers and uneven task sizes can leave processors idle.

When adding GPUs or nodes fails to scale linearly
A program’s parallel fraction sets an upper bound on acceleration. If a significant fraction must execute on one thread, one process or one tightly ordered data structure, doubling the processor count cannot halve total runtime. Communication can impose another ceiling: when workers exchange results frequently, the network and synchronization overhead can exceed the useful computation.
GPUs are particularly effective for stable, regular kernels with many identical operations and predictable memory access. They are a poor fit for branch-heavy code, irregular pointer structures, tiny workloads, or algorithms that repeatedly move data between host memory and device memory. A GPU can increase peak arithmetic throughput while leaving the actual bottleneck untouched.

What to change when the simulation is still too slow
- Profile an end-to-end run. Measure where time goes, including I/O, memory stalls, synchronization and communication. Do not optimize a kernel merely because it looks computationally intensive.
- Inspect asymptotic growth. Determine how operations and memory increase with input size. A lower-growth algorithm can beat a faster implementation of a worse algorithm once the problem is large enough.
- Locate serial sections. Measure unavoidable ordering, critical sections and load imbalance. Redesign dependencies or use a decomposition that gives workers larger independent tasks.
- Measure data movement. Track cache misses, memory bandwidth, device transfers and network traffic. Reuse data locally, reduce precision where acceptable, fuse operations or change data layout.
- Measure energy as well as time. An approach that is marginally faster but consumes substantially more power may be unsuitable at scale or thermally impossible.
- Choose the intervention that matches the evidence. Change the algorithm for complexity or serial-work problems; change architecture for stable, regular kernels; use approximation when exact computation is intractable.
- Re-measure after every change. Science described performance engineering as a loop: measure, modify, measure again and retain improvements that survive realistic workloads.
Which strategy fits the constraint?
| Approach | Best fit | Primary limitation | Trade-offs to check |
|---|---|---|---|
| Faster general-purpose hardware | Highly parallel, compute-bound workloads | Little benefit when complexity, serial work or data movement dominates | Parallel fraction, memory bandwidth, energy per result |
| Algorithmic redesign | Rapid asymptotic growth or excessive serial work | May require new mathematics, validation and substantial software changes | Complexity, accuracy, engineering effort and portability |
| Specialized hardware | Stable, regular kernels repeated at high volume | Low flexibility for changing or irregular algorithms | Data transfer, programming cost, portability and energy |
| Approximation | Exact optimization is computationally intractable but bounded error is acceptable | Does not produce an exact answer | Error guarantees, reproducibility and domain risk |
Are some problems fundamentally too hard for classical computers?
For some tasks, the issue is not an insufficiently large machine but the growth of the exact computation. MIT’s 2021 review, drawing on 57 textbooks and more than 1,110 research papers, explains how exponential-complexity problems quickly outpace computers as instances grow. That does not mean every instance is impossible: input structure, heuristics and special cases can make useful solutions practical. It does mean that a general promise of “just add compute” is not credible.
Approximation, randomized methods, domain-specific constraints and reformulating the question can turn an unusable exact task into a useful answer. The acceptable choice depends on the cost of error: a scientific estimate, schedule or screening result may tolerate a bound, while a safety-critical proof may not.

The practical decision checklist
- Have you profiled the complete application on a representative input?
- What is the algorithm’s asymptotic time and memory growth?
- What percentage is serial, synchronized or communication-bound?
- Are processors waiting on memory, storage or network transfers?
- Does the workload have enough regular, independent work for a GPU or accelerator?
- What are the measured time and energy per result?
- Can you accept an approximation, lower precision or a probabilistic answer?
- After each change, did you rerun the same realistic benchmark and verify correctness?
These questions turn a vague request for a faster supercomputer into an engineering decision. The National Academies’ report The Future of Computing Performance: Game Over or Next Level? provides broader context on the transition from single-processor scaling to parallel systems and the software challenges that follow.
