A memory capacity bottleneck occurs when a system’s usable memory pool is too small to hold the data and working state a workload needs. The workload may have to be reduced, split into smaller parts, moved to another memory pool, or may fail to run as configured. The key is identifying which pool is short: GPU memory, system RAM, or another component’s memory.
What the term means
“Capacity” is the amount of information a memory pool can hold. A capacity bottleneck exists when the workload’s required working set cannot fit within the usable capacity available to it. In accelerator research, limited physical memory inside an accelerator has constrained which algorithms researchers could study. Kwon and Rhu’s 2018 MICRO paper describes this problem in the context of deep learning.

Usable capacity is specific to the component and workload. A GPU can run out of its own local memory while the computer still has unused system RAM. That spare RAM does not automatically become GPU memory; software and system architecture must make it accessible, and using it may require data transfers.
Capacity is different from bandwidth
| Constraint | What it limits | Typical consequence |
|---|---|---|
| Memory capacity | How much data and working state can be held in the relevant pool | The workload must be reduced, partitioned, offloaded, or cannot run as configured |
| Memory bandwidth or data movement | How quickly data can move between memory and compute | The workload may run slowly while waiting for transfers, even when it fits in memory |
A 2023 survey of processing-in-memory systems describes a data-movement bottleneck as arising when an application needs to move data from memory to compute faster than the system can sustain. The distinction matters: adding capacity may solve a fit problem, but it does not necessarily make transfers faster.

Memory hierarchy introduces another trade-off. A computer-systems textbook explains that main memory holds more than CPU-local storage but generally offers lower performance; the memory bus also adds latency and limits transfer rates relative to on-CPU storage. These are hierarchy and transfer considerations, not the definition of a capacity bottleneck.
How a capacity limit affects a workload
When a required working set exceeds a pool’s usable capacity, the practical options depend on the component and software. A workload may be downsized, divided into smaller pieces, or configured to use another memory pool. Some configurations simply cannot run. In GPU machine learning, the working set can include more than the model itself: inputs, activations, and other state also consume GPU memory.

A 2024 University of California eScholarship dissertation reports a GraphSAGE experiment on an NVIDIA RTX 6000 with 24 GB of GPU memory. Certain tested configurations exceeded the available memory and produced out-of-memory errors; memory limits also constrained depth, hidden size, and aggregation fanout. This is evidence about that experiment, not a universal minimum or threshold for GPU memory.

Example: limited GPU memory in deep learning
Kwon and Rhu’s 2018 MICRO paper examines how accelerator physical memory can constrain deep-learning algorithms. Their proposed architecture pooled memory modules near the device-side interconnect to expand accelerator-accessible capacity. In the authors’ evaluation, the system delivered an average 2.8× speedup across eight deep-learning applications and reached system-wide memory capacity in the tens of terabytes. Those figures describe the proposed research system and its evaluation, not a general performance guarantee or a specification for an off-the-shelf computer.

A separate paper on GPU memory virtualization discusses using CPU memory as well as GPU memory to work around limited physical GPU capacity. This can make some workloads feasible, but it is not equivalent to adding local GPU memory: moving data between CPU and GPU memory can add overhead, particularly when transfers become a limiting factor.
How to tell whether capacity is the problem
- Identify the pool involved. Determine whether the workload is constrained by GPU-local memory, host RAM, or another specific pool. Do not infer that one pool’s unused capacity is available to another.
- Check whether the workload fits. Account for the full working set, not just the main dataset or model. Depending on the task, inputs, activations, and other state may also use memory.
- Separate fit from transfer speed. If the working set fits but execution is slow, investigate data movement and bandwidth rather than assuming capacity is the cause.
- Choose a remedy for the constrained pool. Options may include reducing the workload, partitioning it, using offload or virtualization where supported, or increasing that pool’s capacity. Each option has software and performance trade-offs.
Which fixes address a capacity bottleneck?
- Reduce or partition the workload: This can lower the amount that must fit at once, if the application supports smaller configurations or chunked processing.
- Use another pool through offload or virtualization: This may extend what can run, but only when the software and architecture support it. Transfers can introduce overhead.
- Increase the capacity that is actually constrained: For a GPU-local limit, a compatible GPU with more physical memory may be relevant. For a host-RAM limit, system memory may be the relevant pool. The right upgrade cannot be determined from the term alone.
Adding or exposing memory can remove a fit constraint while making data movement more important. For example, GPU memory virtualization can allow CPU memory to supplement GPU memory, but transfers between the two may slow execution. A hardware upgrade is useful only if it increases the memory pool limiting the workload and is compatible with the system and software.

What the term does not tell you
“Memory capacity bottleneck” identifies a type of constraint; by itself, it does not specify a universal minimum memory requirement, diagnose a particular computer, or prove that buying more RAM or a different graphics card will help. The relevant pool, workload size, software support, and transfer costs all matter.
