It is data that exercises your application’s schema, business rules, relationships, and scenarios—and can be recreated reliably in the environment where it is used. Start with explicit fixtures for focused tests, add seeded Faker values when plausible fields help, and use schema-aware or source-derived generation when broader datasets are needed.
What makes test data realistic?
A name, address, and date can look convincing while forming an invalid record. A useful test dataset must match the conditions that matter to the code under test:
As an Amazon Associate I earn from qualifying purchases.
- Schema: Required fields, types, formats, and allowed values are valid—or deliberately invalid when testing validation.
- Domain rules: The values make sense together, such as an order total matching its line items or a subscription status matching its dates.
- Relationships: Foreign keys, ownership, permissions, and join keys connect the way the tested behavior expects.
- Scenario: The data represents a meaningful case: a boundary, a failure, a normal workflow, or a particular user state.
- Repeatability: The same setup can be regenerated so a failing test is diagnosable rather than dependent on accidental random output.
Plausible-looking fields are useful, but they do not establish domain validity, relationship consistency, or privacy safety.

Choose the method that fits the test
| Approach | Best fit | What it gives you | What to check |
|---|---|---|---|
| Explicit fixtures | Unit tests and focused integration tests | Precise control over a scenario and straightforward diagnosis | Maintenance effort and coverage of boundaries |
| Faker with factory logic | Local test records and repeatable seed data | Convenient plausible values, locale choices, and seeded output | Business validity, relationships, version pinning, and collisions |
| Schema-aware generation | Development databases, demos, end-to-end tests, and larger datasets | Output shaped for a schema, with possible relationship support | Constraint fidelity, determinism, supported stores, and scale |
| Source-derived synthesis | Distribution-aware validation and some sensitive-data testing | Artificial data intended to retain statistical patterns from source tables | Privacy method, similarity risk, row and column behavior, and platform restrictions |
| AI-assisted generator authoring | Drafting a custom fixture or generator | A way to produce candidate data or generator code | Correctness, repeatability, privacy, licensing, and code quality |
Use explicit fixtures for precise cases
When a test checks one behavior, hand-authored data is often the clearest choice. A fixture can encode exactly the condition that matters: an empty optional field, a value at a limit, an invalid combination, an unusual date, a permission state, or a failure condition.

Factories can reduce repetition without making the case mysterious. Keep defaults valid, allow individual tests to override relevant fields, and centralize construction of related objects. Prefer an explicit test-specific override over a randomly assembled record when the purpose is to verify a precise rule.
Add Faker for plausible field values
The Python Faker documentation describes providers for names, addresses, text, and other values, along with locale selection and pytest fixture support. Installation is pip install Faker. Faker can make generated records less repetitive, but your factory still needs to enforce application-specific constraints and relationships.

Make generated output reproducible
Faker documents both seed(), which seeds the shared random generator, and seed_instance(), which seeds an individual generator. Its documentation states that a seed produces the same result when the same methods are called with the same Faker version. Dataset updates can change results between patch versions, so pin the patch version if tests rely on exact generated values. See the Faker seeding guidance.
Use a fixed seed for a repeatable generated suite, but avoid making every test depend on incidental output order. Where possible, assert behavior and invariants rather than a particular generated name or address. Select the locale explicitly if the application handles localized names, addresses, dates, or formats.

Use schema-aware generation when the dataset is broader
For development databases, demos, and broad end-to-end workflows, generating complete records can be more useful than composing every object by hand. MongoDB’s Atlas tutorial shows a Node.js workflow using faker.js to create nested owner and event data aligned to a schema. It inserts 5,000 documents as an illustration; that example is not a benchmark or a general recommendation for dataset size. See the MongoDB Atlas synthetic-data tutorial.
Schema alignment alone does not guarantee realistic distributions or valid business scenarios. Check whether the generator enforces required fields, uniqueness, allowed combinations, and relationships your application depends on. For joins across generated tables, ensure corresponding keys are consistent rather than independently randomized.

When source-derived synthesis is appropriate
Sometimes the goal is not merely to populate a schema, but to approximate patterns found in production data. Snowflake documents a synthetic-data procedure that creates artificial data based on source tables, retaining column names and types and generally the same number of rows, subject to its optional privacy filter. It aims to preserve approximate distributions and correlations. To join synthetic tables, users designate join-key columns so corresponding source values receive consistent artificial values; a consistency secret can keep those join keys consistent across runs. Snowflake states that this feature requires Enterprise Edition or higher. Details are in the Snowflake synthetic-data documentation.
Do these 3 things before closing this tab:
1Clear out junk files and repair common Windows errors2Scan for outdated or missing drivers - takes under a minute3Repair Windows errors before they cause bigger problemsThis is a different task from generating records from a schema and Faker-style rules: source-derived synthesis uses information from source tables. Snowflake describes a synthetic dataset similar to production as a way for production engineers to test and validate their environment, but that purpose does not by itself establish a privacy guarantee for every use.

Privacy depends on the method and controls
“Synthetic” does not automatically mean anonymous, compliant, or safe to share without restriction. Snowflake documents an optional similarity filter that removes rows deemed too similar to input data using nearest-neighbor distance measures. Dataiku DSS 14 separately describes privacy-preserving synthesis options based on differential-privacy approaches, including DP-CTGAN, PATE-CTGAN, and MWEM. These controls are specific to their methods and implementations; evaluate them in the context of the data, configuration, and intended release.
Dataiku also documents a Universal Data Generator for datasets created from scratch using distributions, categorical sampling, Faker providers, and correlation modeling, as well as methods for oversampling classification targets. The synthetic-data generation plugin must be installed. This kind of workflow is more relevant to analytics, sandboxes, and model validation than to ordinary unit-test fixtures. See the Dataiku DSS synthetic-data documentation.
Use generative AI as an authoring aid, not a trust shortcut
A 2024 preprint by Baudry and colleagues evaluates prompting language models at three integration levels: generating raw test data, writing a program that creates data, and writing a program that uses an existing Faker library. The authors report evaluation across 11 domains and say models could successfully create realistic data generators in those evaluated domains. The abstract does not establish production readiness, privacy protection, reproducibility, or correctness for a particular application. See the 2024 preprint.
Treat AI output as a draft. Review generated fixtures and code against the schema, business constraints, relationships, deterministic behavior, licensing needs, and privacy requirements. Keep critical edge cases explicit and tested rather than relying on a model to rediscover them each time.
Quick Recap
A practical workflow for building a reliable dataset
- Define the behavior under test. List the exact normal, boundary, and failure cases the test must cover.
- Start with the smallest valid records. Use explicit fixtures or factories to create only the entities and relationships needed.
- Add plausible variation where it helps. Use Faker providers and an explicit locale for field values that benefit from realistic variety.
- Seed generated suites. Keep the seed and generator version under control when repeatable output matters; avoid brittle assertions on arbitrary values.
- Scale only for a reason. Choose schema-aware generation for broader workflows, or source-derived synthesis when source distributions are genuinely needed.
- Validate the result. Check constraints, uniqueness, joins, scenario coverage, and the applicable privacy controls before using or sharing the data.
Questions to ask before choosing a generator
- Does it support the schema, relationships, and domain constraints that matter to this test?
- Do you need realistic-looking fields, approximate distributions, or exact scenario control?
- Can you reproduce a failing case across runs and dependency updates?
- What source information does the method use, and what privacy controls are actually applied?
- Will it integrate with the required store and scale, and what platform dependency or edition cost does it introduce?
