Spark Is a Smart Engine. So Why Doesn’t It Cache Automatically?

Spark does not retain every computed dataset automatically. Learn how lazy execution, storage trade-offs, cache APIs, and reuse determine when caching helps.

Spark doesn’t cache every dataset automatically because caching is a choice to keep computed data in limited memory or disk for reuse. It helps when repeated work costs more than retaining the result; otherwise, it can consume resources without helping. Spark optimizes how work runs, but it cannot know in advance which results you will reuse or what storage your workload can spare.

Why Spark recomputes work by default

Spark transformations are lazy: defining operations builds a plan, but does not immediately compute their results. An action—such as one that requires output—triggers execution. The Apache Spark RDD Programming Guide explains that “All transformations in Spark are lazy, in that they do not compute their results right away,” and that “By default, each transformed RDD may be recomputed each time you run an action on it.” Apache Spark RDD Programming Guide.

Assigning a DataFrame or RDD to a variable does not, by itself, tell Spark to retain its computed result. Unless you explicitly cache or persist data, a later action may repeat the upstream transformations. This behavior is separate from Spark’s execution optimizations: caching is one possible tuning choice among others, not an automatic consequence of building a query plan. Why caching is opt-in

A cached result takes storage away from other work. Retaining data can save the cost of rebuilding it, but the result may be large, used only once, or cheaper to recompute than to read from storage. Spark exposes different storage choices rather than assuming that one retention policy suits every application. That trade-off implies why caching everything automatically would be risky: Spark cannot reliably choose what to retain without knowing future reuse and the cluster’s resource constraints.

The useful comparison is not simply “cached versus uncached.” It is the expected number of reuses and the cost of the upstream work versus the cost of storing and reading the result. Spark’s RDD guide advises checking whether data fits comfortably in memory and notes that recomputation can sometimes be as fast as reading from disk. RDD Programming Guide.

Choose the cache behavior for your data type

SQL/DataFrame caching and RDD persistence have distinct APIs and documented defaults. Do not assume RDD storage-level behavior applies to SQL caches.

  • Memory-only: suitable when retained partitions fit and quick in-memory reuse is valuable. For RDDs using the default MEMORY_ONLY level, partitions that do not fit may be recomputed.
  • Memory-and-disk: lets data that exceeds memory spill to disk instead of relying solely on recomputation. Disk reads still have a cost, so this is not automatically faster.
  • Disk-only: keeps persisted data on disk when memory is not an appropriate place to retain it; compare disk access with the work needed to recompute the result.

RDD cache partitions are not guaranteed to remain resident indefinitely. Spark monitors RDD cache usage and can drop older cached partitions using least-recently-used (LRU) eviction. That RDD-specific detail should not be read as a description of every SQL/DataFrame cache setting. RDD Programming Guide.

When should you cache a DataFrame in Spark?

Cache a derived dataset when you expect to reuse it and rebuilding it costs more than retaining and reading it. Before opting in, assess:

  • How many later actions or operations are likely to reuse the same result.
  • How expensive its upstream transformations are.
  • How large the result is compared with available memory.
  • Whether using disk for overflow is acceptable for the workload.
  • Whether the result will still be useful after those repeated operations.

Caching is a performance optimization, not a speed guarantee. Spark’s tuning guide presents multiple techniques, and the RDD guide’s phrase “often by more than 10x” describes possible improvements for future actions that reuse persisted RDD partitions; it is not a universal result or a benchmark for your job. Inspect the running application and measure your own workload before treating a cache as beneficial.

A SQL cache setting to handle carefully

The Spark 4.2.0 Performance Tuning documentation gives spark.sql.inMemoryColumnarStorage.batchSize a default of 10000. The page says larger batches can improve memory utilization and compression, but may risk out-of-memory errors. This is a configuration default, not a general performance result. How to cache and release data

For a DataFrame you plan to reuse, call cache() and let an action materialize the result; for a SQL table, use the cache statement or catalog API. When the repeated work is finished, release the cached relation rather than holding it unnecessarily.

  1. DataFrame: call dataFrame.cache(), then run the action that needs the data. Release it with dataFrame.unpersist().
  2. Catalog table: call spark.catalog.cacheTable("tableName") or issue CACHE TABLE table_identifier. Release it with spark.catalog.uncacheTable("tableName") or the corresponding SQL uncache operation.
  3. RDD: use rdd.persist(storageLevel) when you need a particular RDD storage level, then call rdd.unpersist() when that retained result is no longer useful.

Calling a cache API does not make the work eager by itself; transformations remain lazy until an action requires a result. SQL also supports CACHE LAZY TABLE when you want caching to wait until first use. CACHE TABLE reference.

Why is Spark recomputing my DataFrame?

The most common explanation is that the DataFrame’s transformations were defined but its result was never persisted. If a later action needs the same derived result, Spark can execute the upstream work again. If you did request persistence, check that the relevant cached data is being reused and whether it remains available; for RDDs, partitions can be evicted under storage pressure. Cache only when repeated work makes retention worthwhile, and unpersist it after that reuse window ends.
