There is no universal storage number for an AI data lake. A defensible estimate starts with daily data production and retention, then adds the raw, transformed, curated, versioned, backup, replica, metadata, and log data you actually keep. Training caches, checkpoints, and other high-performance workspace should be sized separately from durable lake capacity.
What you are really estimating
“Storage for an AI data lake” usually describes several different requirements:
As an Amazon Associate I earn from qualifying purchases.
- Durable capacity: bytes that must remain available for the retention period.
- Working capacity: staging areas, transformation scratch space, caches, temporary joins, and failed-job retries.
- Performance capacity: the throughput, I/O operations, and latency needed by training and analytics jobs.
- Resilience capacity: backups, replicas, cross-region copies, and retained versions.
These capacities can live on different storage tiers. A lake may keep authoritative data in scalable object storage, use a faster workspace during a training run, and move old data to a lower-cost tier. Combining all of those into one “terabyte” figure produces a misleading design.

For each source, the basic retained-raw calculation is:
daily ingest × retention days
Then apply documented assumptions for growth, transformations, versions, and resilience. Do not automatically add raw, transformed, and curated totals as if every layer contains a complete byte-for-byte duplicate. Identify which outputs are full copies, reduced projections, aggregates, or temporary products. A representative pilot is the best way to replace assumptions with measured ratios.
Step 1: Inventory every data source
Create one row for each source and modality before choosing a storage service. Include current observations and forecast production, not just the size of the first training set.
| Field | What to record | Why it changes the estimate |
|---|---|---|
| Source and owner | Application, sensor, partner feed, user upload, or model pipeline | Different owners often have different retention and deletion rules. |
| Modality and format | Tabular data, text, image, audio, video, logs, embeddings, or model artifacts | Compression, file size, and access patterns vary sharply by type. |
| Current size | Observed bytes in the source system | Provides a baseline instead of a guess. |
| Arrival rate | Daily or monthly volume, including batch and streaming peaks | Determines how quickly capacity is consumed and how much ingest headroom is needed. |
| Growth assumption | Expected change in volume, event rate, resolution, or number of sources | Historical averages can understate expansion of an AI program. |
| Object and file sizes | Typical and worst-case sizes, not only an average | Small-file overhead and parallel-read behavior affect both capacity and performance. |
| Retention class | Required days, months, years, or indefinite retention | Retention usually dominates durable capacity. |
| Data quality and deletion | Invalid records, legal holds, erasure requests, and reprocessing needs | Data that cannot be deleted or must be restored increases retained bytes. |
Record whether a feed is continuous or batch-based. A streaming source may need an ingest buffer and replay window even when its daily total is modest. For each source, note where training data and model artifacts currently live, their file formats, compression settings, durability expectations, backups, and versioning policy.
Step 2: Define the retained lake layers
A common lake design separates data into raw, transformed, curated, and log or metadata areas. The names differ between organizations, but the retention decision is the same: which copies must remain available, and for how long?
Raw data
Raw data preserves source fidelity. Keeping it makes reprocessing possible when a parser, label, feature definition, or model changes. Calculate its capacity per source with the daily-ingest formula, then add forecast growth. If raw data is immutable, versioning may be unnecessary; if it is rewritten or corrected, retained snapshots can add substantial capacity.
Transformed data
Transformations may normalize schemas, decode media, remove personally identifiable information, create training examples, or convert files into query-friendly formats. Measure the output-to-input ratio on representative data. Some transformations reduce volume; others expand it by adding features, multiple resolutions, or tokenized representations.

Curated and feature data
Curated datasets are business-ready or training-ready products. They can be smaller than raw data, but feature tables, embeddings, labels, and joins may be retained for many model versions. Decide whether a curated dataset is reproducible from retained inputs. If it is, you may not need every historical copy; if it is not, each retained release is a capacity term.
Logs and metadata
Include catalog entries, lineage, manifests, quality results, access logs, orchestration records, and model metadata when they are material. They are usually much smaller than media, but long retention, verbose logging, or high event rates can make them significant. Keep operational logs separate from application logs when their retention rules differ.
Step 3: Forecast growth instead of sizing only for today
For a simple annual forecast, apply an explicit growth rate to the source’s daily or monthly arrival rate:
future daily ingest = current daily ingest × (1 + growth rate)years
What’s actually slowing this PC down?
Pick the symptom - the matching free tool is one click away.
For a source whose production changes in steps—such as a new camera fleet or an additional customer cohort—model each step separately. Retention also changes the curve: when retention is shorter than the forecast horizon, the lake approaches a rolling window; when data is retained indefinitely, every year’s production accumulates.
Use at least three scenarios:
- Low: current production with conservative growth and the minimum approved retention.
- Expected: the business plan, measured transformation ratios, and normal version and backup policies.
- High: faster source growth, longer retention, additional modalities, larger checkpoints, and a realistic migration or reprocessing event.
Put the assumptions beside each total. A single number without its retention period and growth case cannot be reviewed or budgeted reliably.
Worked example: turning source rates into durable capacity
The following is an illustrative calculation, not a universal recommendation. Suppose a team records:

| Source | Daily arrival | Retention | Retained raw calculation |
|---|---|---|---|
| Images | 0.8 TB/day | 90 days | 72 TB |
| Text and documents | 0.2 TB/day | 180 days | 36 TB |
| Application logs | 0.1 TB/day | 30 days | 3 TB |
| Total | 111 TB of retained raw data |
Assume a measured pilot shows transformed outputs equal to 40% of retained raw bytes and curated outputs equal to 10%. If the team retains versions equal to 20% of raw data, the pre-resilience estimate is:
111 TB + 44.4 TB transformed + 11.1 TB curated + 22.2 TB versions = 188.7 TB
If an approved backup policy retains an additional copy equal to 50% of that subtotal, the estimate becomes 283.05 TB before any independent replica or temporary workspace. A second full replica would add another 188.7 TB if it covers only the durable layers in this example. The point is not the resulting number; it is that every multiplier is visible and tied to a policy. Replace the illustrative ratios with measurements from your own data.
Step 4: Add backups, replicas, versions, and disaster recovery
Resilience is not one universal multiplier. Document each policy as a separate row:
- Backups: full, incremental, snapshot, or object-level copies; retention period; and restore points.
- Replication: same-region or cross-region copies, replica count, and whether replication is synchronous or asynchronous.
- Dataset versions: number of releases retained, how long old versions remain, and whether unchanged objects are deduplicated.
- Disaster recovery: the recovery point and recovery time objectives, plus the data that must be available in the recovery location.
Check what the provider configuration actually preserves. A versioning setting may retain deleted objects; a backup may be incremental; a cross-region policy may cover only selected buckets or prefixes. State whether temporary staging, failed jobs, and retry outputs persist. If they are deleted automatically, they belong in performance and headroom planning rather than durable capacity.

Training storage has different lifetimes and performance requirements from the lake of record. Identify:
- how much data must be staged or cached for a job;
- how many times the job reads the data;
- checkpoint size and checkpoint frequency;
- the number of simultaneous jobs;
- how many checkpoint generations are retained; and
- whether inference uses a shared dataset or local caches.

| TPU workload | Dataset storage per TPU | Checkpoint storage per TPU |
|---|---|---|
| LLM pre-training | 2 TB | 200 GB |
| Multimodal training | 12 TB | 1 TB |
| Inference | 1 TB | 1 GB |
These figures are Google’s TPU-oriented estimates, not generic requirements for every accelerator, model, or data lake. Multiply by the number of concurrent workers only when each worker needs its own copy; a shared dataset may require less capacity but higher throughput. Checkpoint retention can exceed the amount written by one run when multiple experiments are preserved.
Capacity is not throughput
A lake can have enough terabytes and still starve a training cluster. Performance planning should specify:
- sequential and random read throughput;
- metadata and I/O operation rates, especially with many small files;
- checkpoint write bandwidth and the allowed checkpoint window;
- concurrent readers and writers;
- startup time for a job to populate its cache; and
- latency requirements for interactive queries or online inference.
Repeated training passes can generate heavy reads without increasing durable capacity. Conversely, frequent checkpoints can create bursty writes and temporary free-space requirements. Benchmark with the actual parallelism, file sizes, compression, and access pattern rather than inferring performance from capacity.
Independent reader supportYour contribution helps us test, update, and keep practical guides available for everyone.Step 6: Measure compression and file-format effects
Estimate stored bytes using representative samples in the target format and compression settings. AWS describes Parquet as a compressed columnar format and reports an example in which 1 TB of CSV log data became 130 GB of Parquet—an 87% space saving—in a 2021 test. That result is specific to the cited data, schema, compression, and test conditions. It is not a promise that every log, image, or training set will shrink by 87%.
Measure both size and workload behavior. A format can reduce scans while increasing CPU cost during writes, or compress well but perform poorly for small random reads. Record the ratio for each modality, partitioning scheme, and compression level. Include temporary uncompressed staging if the pipeline creates it before compaction.
Choosing storage by workload, not by terabytes alone
Compare candidate storage arrangements against the following axes:
| Decision axis | Questions to answer |
|---|---|
| Capacity and scaling | Can it expand at the forecast rate without disruptive migrations or hard object limits? |
| Access and retrieval | How often is each dataset read, and what latency is acceptable for hot, warm, and historical data? |
| Throughput and I/O | Can it feed concurrent training jobs and absorb checkpoint bursts? |
| Durability and resilience | Which redundancy, replication, consistency, and recovery guarantees are configured? |
| Lifecycle | Can infrequently accessed data transition to a lower-cost tier while remaining retrievable within the required window? |
| Security and geography | Are encryption, identity controls, auditability, residency, and cross-border restrictions satisfied? |
| Total cost | What will storage, requests, retrieval, data transfer, replication, and operational work cost under the expected access pattern? |
Historical data that is retained but rarely queried may fit a lifecycle tier, provided restore latency and retrieval charges meet the business requirement. Keep frequently scanned, training-ready data in a tier that can deliver its required throughput. Cost comparisons should use your scenario totals and access frequency, not a headline price per terabyte.
Best Value
Validate the estimate with a pilot
- Select representative samples. Include typical and worst-case files from every modality, not only a convenient subset.
- Run the real ingestion path. Measure bytes before and after validation, deduplication, transformation, partitioning, and compression.
- Record retained ratios. Capture transformed-to-raw, curated-to-raw, feature, embedding, and version-retention ratios.
- Exercise concurrent workloads. Run representative training reads, analytics scans, and checkpoint writes together.
- Test recovery. Verify what backups and replicas contain, how long restoration takes, and how much capacity a restore requires.
- Project the observations. Apply measured ratios to current and forecast source volumes, then calculate low, expected, and high cases.
- Recalculate on change. Revisit the model when retention, source rates, model-training cadence, formats, or replication policies change.
Keep durable capacity, temporary workspace, and throughput results in separate planning sheets. This prevents a short-lived cache from inflating the permanent lake estimate while ensuring that the cache is still funded and provisioned.
Common estimation mistakes and fixes
Using the size of one training dataset
A training set is only one retained product. Add ongoing ingest, raw retention, transformed and curated outputs, versions, logs, backups, and future growth.
Applying one replication multiplier to everything
Different datasets may have different replica counts, backup schedules, or lifecycle tiers. Model each policy explicitly and verify whether copies are full or incremental.
Quick wins for a faster PC:
Clear out junk files and repair common Windows errorsFree Scan →Scan for outdated or missing drivers - takes under a minuteDriver Scan →Assuming every layer duplicates all bytes
Some transformed outputs are compact projections; others expand the source. Measure the ratio and state which layers are retained.
Treating compression examples as guarantees
The AWS Parquet result is a benchmark example, not a universal ratio. Test your schema, data distribution, format, and compression settings.
Confusing capacity with speed
More terabytes do not automatically provide the bandwidth needed by a training cluster. Benchmark throughput, I/O rate, latency, and checkpoint windows separately.
Ignoring temporary and recovery headroom
Compaction, backfills, failed retries, restores, and simultaneous experiments can require free space beyond the steady-state total. Add a documented operational reserve based on observed peaks.
A repeatable worksheet
For each dataset, fill in these fields:
- source and modality;
- current bytes and daily or monthly ingest;
- growth assumption and forecast horizon;
- raw retention period;
- transformed and curated output ratios and retention;
- version count and retention;
- backup and replica policy;
- metadata, logs, and operational reserve;
- training cache, checkpoint, and concurrent-job requirements; and
- required throughput, latency, recovery point, and recovery time.
Sum the durable rows for each scenario, then maintain a separate performance and temporary-capacity plan. The resulting estimate is reviewable because every byte is tied to a source, policy, workload, or measured ratio.
Bottom line
Estimate an AI data lake from production and retention outward: inventory every source, forecast growth, define which raw and derived layers remain, add explicit versions and resilience copies, and measure format and compression ratios. Size training caches and checkpoints separately, and validate throughput with representative concurrent jobs. Without those inputs, a single capacity number is not defensible; with them, the estimate becomes a model you can update as the data and workload change.
