How to Design AI Guardrails for a Production LLM Application

A production LLM needs more than a prompt filter. Map trust boundaries, validate inputs and outputs, enforce tool permissions outside the model, and test controls throughout operation.

Design AI guardrails as a layered application-security system—not as a filter wrapped around a model. Treat prompts, retrieved content and tool output as untrusted; validate inputs and generated output at the boundaries; enforce tool permissions in trusted application code; require approval for consequential actions; and continually test and monitor the system. A guardrail model can add screening, but it cannot replace least privilege, deterministic validation or human oversight.

Start by mapping the application’s trust boundaries

Before selecting filters or services, map how information and actions move through the application: user inputs, retrieved documents, external APIs, prompts, session memory, model responses, tool calls and downstream systems. Mark which data is sensitive and which actions could disclose information, change state, spend money or affect users. This gives the team a basis for deciding where controls belong and which failures would matter most.

Threat-model both direct prompt injection from a user and indirect injection carried in retrieved or fetched content, including tool output. Also consider sensitive information disclosure, unsafe output handling and excessive agency. Screening only the raw user prompt leaves indirect routes unchecked.

The OWASP Top 10 for LLM Applications (2025) is a useful risk checklist, not a ranking of probability or a replacement for application-specific threat modeling:

#1 Best Overall
Dell Precision 7920 Tower Workstation, VR CG AI 4K Editing Rendering, 2 x Intel Xeon Gold 6130 up to 3.7GHz (32-Cores), 192GB DDR4, 2 x 1TB SSD + 2 x 4TB HDD, Quadro P1000 4GB, Win11 Pro (Renewed)

  • 2x Intel Xeon Gold 6130 16-Core 2.1GHz (3.7GHz Turbo)
  • 192GB DDR4 Memory - upgradable to 1.5TB
  • 2x 1TB SSD + 2x 4TB HDD (Removable Hot Swap Drive bays)
  • Nvidia Quadro P1000 4GB - Windows 11 Professional 64-bit
  • LLM01: Prompt Injection
  • LLM02: Sensitive Information Disclosure
  • LLM03: Supply Chain
  • LLM04: Data and Model Poisoning
  • LLM05: Improper Output Handling
  • LLM06: Excessive Agency
  • LLM07: System Prompt Leakage
  • LLM08: Vector and Embedding Weaknesses
  • LLM09: Misinformation
  • LLM10: Unbounded Consumption

Prioritize these against the application’s actual users, data, tools and potential impact. NIST’s AI Risk Management Framework is voluntary guidance for incorporating trustworthiness into AI design, development, use and evaluation; its Generative AI Profile was released on July 26, 2024. NIST says AI RMF 1.0 is being revised, so teams should check the framework’s current status when adopting it.

Place controls before, after and around the model

A useful architecture screens relevant input and context before the primary model, validates generated content before it is displayed or passed onward, and checks proposed actions before they execute. These are separate control points: passing one does not make the others unnecessary.

Before the model: validate inputs and context

Apply ordinary application checks to user input, such as accepted formats and size limits. Treat user prompts and all retrieved, fetched or tool-provided context as untrusted data. Where the risk warrants it, classify that context before including it in the primary model’s prompt. Do not assume that pattern-matching filters will reliably detect indirect injection in documents or other untrusted material. Purpose-trained classifiers can add coverage, but remain one layer rather than a security boundary.

More extensive model-based checks may add latency and service cost. Consider reserving them for sensitive or high-risk paths rather than inserting an extra model call indiscriminately.

After the model: validate for the destination

Treat model output as untrusted input to ordinary software. Before display, apply encoding and sanitization appropriate to the destination. Before parsing structured output, validate it against the expected schema and reject or safely handle values that do not conform. Before sending output to another service or using it to form an action, validate the values and enforce authorization in application logic. A model’s claim that an operation is permitted is not authorization.

Before an action: check intent and authority

Screen proposed actions against the original user intent and the application’s policy. Make the decision in trusted application or downstream code, not in the model’s instructions. A valid-looking tool call can still be unauthorized, unnecessary or inconsistent with what the user asked for.

Constrain agents by limiting what they can do

Give an agent only the tools and data access needed for its task. Use least-privilege scopes, mediate every downstream operation and validate arguments where the action is actually performed. Require explicit human approval for high-impact operations such as sending a message, making a payment, changing privileges, deleting data or deploying to production. Log tool activity and apply rate limits where appropriate.

For example, an agent that needs to find information in a mailbox should not automatically receive permission to send mail. Keep reading and sending capabilities separate, use a read-only scope where it meets the task, and put a human approval step before sending.

OWASP describes a more specialized pattern that separates privileged planning from quarantined parsing of untrusted documents and tracks data capabilities in an interpreter. It identifies CaMeL as promising, while noting that it is early in implementation and needs further research and development for wider adoption; it should not be presented as a mature, universally deployable production solution.

Choose guardrail mechanisms by their role, not their label

Compare candidate controls on where they operate, what authority they have and how they will be maintained. No platform-neutral head-to-head winner is established by the cited guidance.

Decision factor Questions to ask
Coverage point Does the control inspect input and retrieved context, generated output, proposed actions, or more than one of these?
Control type Is it a deterministic application check, a specialized classifier, a general model-based judge or a managed service?
Authority boundary Does trusted downstream code enforce authorization, or is the model being asked to decide what it may do?
Capability scope Which tools and data stores are exposed, and what are their permission levels?
Human control Which consequential actions require explicit approval, and where does that approval occur?
Operational cost What latency, service cost, false blocks and maintenance work might the added control introduce?
Evidence and operations Can the team run adversarial evaluations, audit decisions, monitor changes and recover from failures?

OWASP names Llama Guard, ShieldGemma, IBM Granite Guardian and Prompt Guard as examples of open guardrail models, and NVIDIA NeMo Guardrails as a framework for orchestrating checks. Assess any of them against the application’s requirements; their inclusion here is not an endorsement or a guarantee of protection. OWASP cautions that a guardrail LLM is itself an LLM and can itself be susceptible to prompt injection.

For an AWS-specific option, AWS Prescriptive Guidance maps Amazon Bedrock Guardrails to filtering malicious input patterns and blocking sensitive output patterns. That mapping is not a comparative performance evaluation and does not establish suitability outside AWS.

Evaluate and operate guardrails throughout the release lifecycle

Build tests around failure paths

Create security cases for direct and indirect prompt injection, sensitive-data exposure, malformed or unsafe output, unauthorized tool calls and resource exhaustion. Include cases that exercise retrieved content and tool responses, not only user-entered prompts. Check that invalid structured output is rejected or handled safely, and that denied actions cannot be completed through a downstream path.

Rerun evaluations after material changes

Evaluate before release and repeat after material changes to the model, prompts, retrieval data, tools or policies. Treat evaluations as evidence about the tested cases, not proof that the application is safe in general. AWS guidance maps security evaluation suites, prompt validation, prompt logging, continuous posture management and operational observability to LLM risks; these are operational practices, not a guarantee that any one suite establishes safety.

Monitor decisions and prepare a response

Log guardrail decisions and relevant tool activity in a way that supports audit and investigation. Watch for changes in approval rates and refusal reasons, which can help reveal shifts in system behavior or control operation. Define who responds to a suspected bypass, unsafe action or critical workflow failure, and how the team can contain the issue and recover.
