Clean and normalize machine-learning data by first checking what each value means, then splitting the data in a way that reflects how the model will be used. Fit every learned preprocessing step—including imputation, encoding and scaling—on the training data only, and reuse those fitted transformations for validation, testing and production. The right recipe depends on the task, feature meanings and model; applying every cleaning or scaling method by default can discard useful information or distort evaluation.

What cleaning and normalization are meant to accomplish

Data cleaning makes records and features consistent enough for the intended prediction task. It can include correcting unit or category inconsistencies, deciding how to handle missing or invalid values, removing duplicates when they are truly redundant, and excluding features that are irrelevant or unavailable at prediction time. Normalization usually refers to changing numeric feature scales so that values are represented in a form better suited to a model. Some workflows also use the broader term preprocessing for encoding categories and engineering features.

These operations are not an end in themselves. A transformation is useful when it preserves the information needed for the task, supports the estimator’s assumptions, and can be applied in the same way during evaluation and serving. A rare measurement, for example, may be a valid event rather than a data error. Changing or removing it without understanding its origin can make the training data less representative of real cases.

Scikit-learn’s guidance on preprocessing and leakage and Google Cloud’s guidance on data preparation both emphasize learning preparation rules from training data and making preparation repeatable. TensorFlow likewise treats preprocessing as a combination of data engineering and feature engineering. These principles support a workflow, not a universal list of transformations.

1. Profile and document the raw data

Describe the features before modifying them

For each input and the target label, document its meaning, source, type, expected range, units, and when it becomes available. Record the label definition as well: a model cannot be evaluated meaningfully if the target changes between data collection, training and use. A feature’s name alone is not enough to establish what it measures or whether it is usable at prediction time.

Summarize the data by feature and inspect records that violate expectations. Check for missingness, repeated rows, inconsistent spellings or category labels, mixed units, implausible values, unexpected timestamp patterns, and columns that encode outcomes or information created only after the prediction would be made. A schema with feature types and statistical properties can make anomalous or invalid values easier to spot; Google Cloud recommends this sort of documented view of a dataset.

Investigate anomalies instead of automatically deleting them

Use domain context to decide whether a suspicious observation represents an error, a legitimate rare case, or an ambiguity that needs a documented rule. A value outside an expected range may be caused by a unit mismatch, a faulty sensor, a valid exceptional event, or a mistake in the stated range. Those possibilities call for different responses. If you correct, cap, exclude or otherwise transform a value, record the reason and make the same rule part of the repeatable preparation process.

Also check whether duplicates are duplicates for the question you are answering. Exact repeated rows can inflate the influence of cases, but multiple observations from the same person, device or event may be meaningful rather than redundant. The appropriate decision depends on how records were generated and what the model is meant to predict.

2. Split the data before fitting preprocessing

Choose a split that represents deployment

Separate training data from validation and final test data before learning any preprocessing statistics. The split should reflect how the model will encounter future inputs. For a classification task, stratification may help preserve class proportions across partitions. For time-series prediction, use a chronological split so that training does not learn from observations that occur after the evaluation period.

Reserve the final test set for the end of the process. Use training data to fit the model and preprocessing rules, and validation data to compare choices or tune settings. Repeatedly changing the workflow based on test-set results makes that test set part of model selection, so it no longer provides an independent final check.

Why the order matters

Preprocessing steps such as imputation and scaling estimate quantities from data. If you calculate a mean, standard deviation, category vocabulary or other learned rule using the complete dataset before splitting, information from held-out examples has influenced the transformation. Scikit-learn identifies fitting transformations before splitting as a source of data leakage that can produce overly optimistic evaluation. The held-out records should be transformed using rules learned from training data, not used to learn those rules.

This does not mean every operation must wait until after the split. A fixed, externally defined correction—such as converting a known unit convention consistently—may be applied as data preparation if it does not learn from the held-out examples. But any operation whose parameters or decisions are learned from the dataset should be fitted using only the training portion. When uncertain, include the operation in the fitted training pipeline.

3. Make cleaning decisions by feature and task

Handle missing values deliberately

First establish whether a blank means unavailable, not applicable, not collected or something else. Missingness itself may carry information, but it can also reflect a collection defect. An imputer can preserve rows by replacing missing values according to a rule; deleting rows or features can be appropriate in some situations. Neither choice is correct for every dataset. Consider how much information is missing, why it is missing, and whether removing affected cases would change which population the data represents.

Whatever imputation rule you choose, fit it on training data only, then apply the fitted rule to validation, test and new inputs. Scikit-learn explicitly includes SimpleImputer among transformations that can leak if fitted before splitting. Do not calculate a replacement value from the full dataset and then claim that the test data remained untouched.

Resolve invalid, inconsistent and duplicated data

Apply rules that follow from the data’s meaning: standardize units, reconcile equivalent category spellings, define how invalid values are handled, and decide whether repeated records should count once or more than once. Keep the rules explicit. Silent, inconsistent fixes during separate training and production runs can create inputs that the model was never trained to interpret.

Some cleaning decisions depend on model use. A feature may be technically present in a training table but unavailable when a prediction is requested. Exclude it or redesign the task rather than allowing it to create leakage. Likewise, target labels and fields derived from the target should not slip into the model’s input columns.

Encode categorical features without erasing their meaning

Many estimators need categorical values represented numerically, but there is no single encoding suitable for all categories and models. Choose a representation that matches whether values are nominal, ordered, high-cardinality or otherwise structured, and verify that the fitted transformation handles categories encountered in held-out and future data. Preserve meaningful distinctions; an arbitrary numeric code can imply an ordering that the category does not have.

Keep categorical processing alongside numeric processing in one reproducible path. The fitted category rules must be available at prediction time, just like numeric imputation and scaling parameters. TensorFlow’s preprocessing guidance frames this as data engineering plus feature engineering, while Google Cloud emphasizes repeatable and automatable preparation.

4. Choose numeric scaling for the estimator and data

Scaling changes numeric values, but it does not automatically improve a model. It is often useful when a model’s objective or distance calculations are sensitive to feature scale. For instance, an RBF-kernel support vector machine and a regularized linear model can be affected when one feature’s numeric range dominates another’s. Tree-based methods generally do not depend on the same notion of numeric scale, so scaling should be driven by model behavior and validation rather than habit.

Method Useful when Watch for
StandardScaler (z-score) Features have different scales and the estimator is scale-sensitive. It subtracts a training-feature mean and divides by its training-feature standard deviation. Mean and standard deviation can be influenced by outliers. Fit them on training data only.
MinMaxScaler A bounded interval is useful for the chosen model or feature representation. New values may fall outside the training range. Reuse the fitted transform consistently.
RobustScaler Outliers make mean-and-variance scaling a poor summary of the feature. It does not guarantee that outliers stop affecting a model; evaluate it for the actual task.
MaxAbsScaler or StandardScaler with with_mean=False Sparse matrices need scale adjustment while preserving zeros and sparsity. Centering sparse data can destroy sparsity and consume substantial memory.
Log or power transform A feature’s distribution and model behavior make a nonlinear transformation useful. Inspect and validate the transformed values. Such transforms do not help every distribution.

For standardization, the training-set feature mean is subtracted and the feature is divided by its training-set standard deviation. Min-max scaling instead maps values to a chosen interval. Robust scaling uses more robust location and range estimates, which can be useful when outliers make the mean and variance poor summaries. None of these definitions determines which is best for a particular task.

Pay attention to outliers and sparse inputs

Outliers matter in two different ways: they may be genuine cases the model needs to handle, and they can influence some scaling statistics. Robust scaling is an alternative worth evaluating when mean-and-variance scaling is unsuitable, but it is not a general outlier cure. Removing, clipping or transforming unusual values also changes the problem; apply those operations only when they are defensible for the feature and future inputs.

Sparse data requires another trade-off. Centering subtracts a mean and can turn zero entries into nonzero values, destroying sparsity and potentially using much more memory. Scikit-learn recommends MaxAbsScaler for sparse scaling or StandardScaler(with_mean=False) where appropriate. Choose a transformation that respects the representation as well as the estimator.

Consider transformations beyond simple scaling

Log or power transforms can be useful when the distribution and model behavior support a nonlinear change. Google Cloud lists linear, Z-score and log scaling, along with clipping, among preparation options selected in light of feature characteristics. These are options to assess, not a mandatory sequence. Inspect a feature before and after a transformation, confirm it remains meaningful, and compare its effect on validation performance.

5. Build one fitted, repeatable transformation path

Fit on training data; transform every other partition

For each learned preprocessing component, use fit or fit_transform only with training data. Then use the fitted object’s transform operation on validation data, the final test data and prediction inputs. This applies to imputation and scaling, as well as learned categorical handling and any other transformation that estimates parameters from examples.

Keep the transformations for numeric, categorical and other feature groups in a consistent path. A scikit-learn Pipeline can place preprocessing steps and the estimator together, reducing opportunities for leakage during cross-validation and tuning. For mixed feature types, compose the appropriate transformations into the same repeatable workflow rather than preparing each partition through separate, hand-written steps.

pipeline.fit(X_train, y_train)
validation_predictions = pipeline.predict(X_validation)
test_predictions = pipeline.predict(X_test)

Here, the important property is the order: the pipeline learns its preprocessing from X_train, then applies those fitted steps when it predicts on held-out data. The example assumes the pipeline has already been configured with the intended preprocessing and estimator; it is not a universal pipeline definition.

Keep the fitted transformations with the model

The model artifact used for serving needs the transformation parameters and logic that were fitted during training. Saving only the estimator while separately recreating preprocessing risks differences in missing-value rules, units, category handling or scaling. Serving should apply the same preparation path to inputs that training and evaluation used. Version the data and model artifacts so that a prediction or performance change can be investigated against the relevant inputs and transformations.

6. Validate alternatives without contaminating evaluation

Compare plausible choices on validation data

Use validation data to compare reasonable approaches to cleaning, imputation, encoding and scaling, and measure performance with a metric appropriate to the prediction task. Keep comparisons tied to a defined objective: a transformation that changes a metric slightly may still have other costs, such as losing interpretability, increasing memory use or complicating serving. There is no one scaling method that is right for every dataset.

When using cross-validation, keep preprocessing inside the pipeline so that each fold learns its transformations from that fold’s training portion. Fitting a scaler or imputer once on all records before cross-validation allows each validation fold to influence the preprocessing statistics. The final test set remains separate from these choices and is used for a final evaluation after the workflow has been selected.

Check both model results and transformed data

Before accepting a pipeline, verify that transformations produce the intended feature representation, missing-value handling behaves as expected, and category or range rules are usable on held-out data. Inspect whether outliers or clipping rules have changed values in a way that contradicts feature meaning. A performance metric alone cannot reveal every data-quality problem or catch a serving-time mismatch.

7. Maintain the workflow after deployment

Data preparation continues to matter after training. Keep the training and serving transformations aligned, version datasets and model artifacts, and monitor both input changes and model quality. Google Cloud’s pipeline guidance emphasizes repeatability, versioning, matching serving transformations, and tracking data and model quality. If inputs shift, investigate whether the source, collection process, units, missingness or feature distributions have changed before deciding that a new scaling rule or model is required.

Make the operational rules discoverable: document the feature schema, cleaning decisions, fitted transformations and the data version used to train the model. That makes it possible to reproduce a result, check whether a production input follows expected conventions, and distinguish a model change from a change in incoming data.

A practical checklist

  • Define the prediction task, label and point in time at which each feature is available.
  • Document feature meaning, type, expected range, units and missingness; investigate unusual values before changing them.
  • Choose training, validation and final test partitions to reflect deployment, including stratification or chronological ordering where appropriate.
  • Fit every learned preprocessing rule on training data only; preserve the final test set for evaluation.
  • Choose missing-value handling, category encoding and numeric scaling based on feature meaning, estimator behavior and validation results.
  • Use a repeatable pipeline for preprocessing and estimation, and reuse its fitted transformations for held-out and production inputs.
  • Version data and model artifacts and monitor input and model quality after deployment.
