Do these 3 things before closing this tab:
1Fix the driver behind crashes, sound loss and screen glitches2Repair Windows errors before they cause bigger problems3Scan for outdated or missing drivers - takes under a minuteStart by defining what the software must return: a label for the whole image, locations of objects, or pixel-level regions. Then compare suitable models on the same representative, held-out images and measure quality and speed on the hardware you plan to use. Choose the model that meets your project’s quality and latency requirements within its size, privacy, deployment, and operating-cost limits. No public benchmark can make that choice for your project.
First decide what “image recognition” must do
Image recognition is an umbrella term, not a single task. The required output determines what kind of model to evaluate:
As an Amazon Associate I earn from qualifying purchases.
- Classification: assigns one or more labels to an image as a whole. Use it when the application needs to identify the general subject or category.
- Object detection: identifies objects and locates them, typically with bounding boxes. It is a better fit when an image may contain several objects and the application must say where each one is.
- Segmentation: identifies regions at pixel level. Use it when the boundary or precise area of an object matters, rather than just its presence or approximate location.
A whole-image label will not answer a question about where a particular object is. Microsoft’s AI model selection guidance describes convolutional neural networks (CNNs) as suitable for visual tasks such as image classification and object detection, while emphasizing that model choice should fit the workload.

Before browsing model catalogs, write down what counts as a useful result and what errors matter most. Define a minimum quality threshold and a maximum acceptable response time, then consider the conditions the model will actually encounter: lighting, camera angle, blur, image resolution, rare categories, and changes in the environment.

Choose a metric that matches the output
For multiclass image classification, Microsoft identifies accuracy as a primary evaluation metric. For object detection and instance segmentation, it identifies intersection over union (IoU), which measures overlap between a prediction and labeled ground truth. See Microsoft Learn’s evaluation guidance for the task-specific metrics.
One overall accuracy figure can conceal weak performance on rare categories or conditions. Decide which classes and failure types carry the greatest consequences, and inspect results for those cases as well as the overall score. There is no universal metric threshold that makes a model acceptable for every application.

Build a fair model comparison
Evaluate each candidate using the same representative examples, preprocessing, image dimensions, hardware, and measurement method. Keep final test examples separate from training and tuning; otherwise, the evaluation can reward a model for examples it has already seen. Google AI Edge warns that overfitting can produce strong training results that do not carry over to new images in its image-classification customization guide.
Public benchmarks can help screen candidates, but their rankings are not guarantees for your data or device. Google’s guide, for example, discusses a flowers dataset with 3,670 training images across five classes and cautions that results on this relatively simple dataset may not predict performance on more complex image sets. A larger architecture need not win on a simpler dataset.

Compare quality, speed, size, and operating cost
Record the tradeoffs that can change whether a model is practical, not just whether it scores well:
- Quality: task-appropriate results on held-out project images, including important classes and conditions.
- Speed and capacity: end-to-end latency and throughput on intended hardware, including preprocessing and, where relevant, model-loading delay.
- Footprint: model size, memory use, and required accelerator or runtime support.
- Deployment and upkeep: integration effort, engineering skills available, and the work needed to test, update, or roll back the model.
- Privacy and resilience: whether images leave the device, whether the application needs a network connection, and whether it must work offline.
- Cost: inference and infrastructure expense at expected volume, alongside engineering and maintenance effort.
Quality and throughput can pull in different directions: AWS SageMaker JumpStart guidance frames model selection as a Pareto tradeoff, where improving one measure may worsen another. Compare candidates under the same workload rather than treating one score as decisive. AWS discusses this approach in its 2023 model-selection article.

For on-device applications, benchmark on the intended device or a faithful equivalent. Google AI Edge’s object-detection guide reports different latencies for the same model under different configurations on a Pixel 6: EfficientDet-Lite0 is listed at 61.30 ms for float32 CPU, 53.97 ms for float16 CPU, 29.31 ms for int8 CPU, and 27.83 ms for float32 GPU. These are figures reported for that model, device, and configuration; they are not a prediction for another phone, runtime, or dataset.
Choose a deployment route that fits the project
AWS Prescriptive Guidance recommends weighing three factors for an image-classification endpoint: required response time, solution complexity and available human resources, and cost limitations. Its deployment-infrastructure guide discusses managed services, Lambda, serverless endpoints, and batch inference as options with different tradeoffs.
Best Value
- Managed cloud inference: can reduce the burden of operating model-serving infrastructure, but images must be sent to the service and the service’s availability, features, and current pricing should be checked for your region and requirements.
- Custom endpoint or serverless deployment: allows a tailored serving setup, but increases integration and operational responsibility. AWS notes that a Lambda deployment may have a delay while the model loads; provisioned concurrency is one option it discusses for reducing response times.
- Batch inference: suits workloads that can tolerate delayed results rather than requiring an immediate response.
- On-device inference: can support offline use and limit image transfer, but makes model size, memory, accelerators, and device capability central constraints. Microsoft discusses local deployment’s privacy and offline benefits alongside its device limitations in its workload model-selection guidance.
A more customized or locally controlled solution may reduce some infrastructure expense while requiring more engineering and maintenance. The right balance depends on response-time needs, privacy, expected volume, and the skills available to run the system.
Use a repeatable selection workflow
- Specify the output. State whether the application needs image labels, object locations, or pixel-level regions, and define its input conditions.
- Set acceptance criteria. Choose a task-appropriate quality measure, important classes or failure cases, and a response-time limit before comparing candidates.
- Shortlist task-compatible models. Treat catalogs and public benchmarks as ways to find candidates, not final proof that one will work for your project.
- Prepare representative data. Hold final test images out of training and tuning. Include normal operating variation and the difficult cases the application must handle.
- Run controlled comparisons. Use the same data, preprocessing, image dimensions, hardware, and measurement method for each candidate. Measure end-to-end latency and throughput as well as task quality.
- Assess deployment and cost. Check hardware and runtime requirements, privacy, connectivity, model-loading behavior, operating expense, and maintenance effort.
- Select against the requirements. Choose among candidates that meet the minimum quality and latency targets, using size, cost, privacy, and upkeep to resolve remaining tradeoffs.
- Re-evaluate after launch. Track errors on new inputs and test again when the camera, users, environment, or task changes. Set the review cadence according to the consequences of errors and how quickly input conditions change.
Why there is no single best model
The best candidate depends on the project’s images, labels, target hardware, latency budget, operating volume, privacy needs, and maintenance capacity. Model catalogs, cloud features, prices, device runtimes, and benchmark results can change, so verify current service details and repeat evaluation when project conditions change. A model that wins a public benchmark is only a promising candidate until it meets your own acceptance criteria on your own representative data.
