Published examples range from 72 training images in one pavement study to thousands of cropped patches in another dataset, but those counts describe different materials, image sources, counting units and evaluation setups. For a real project, estimate the need with a learning curve: train on progressively larger, representative subsets and measure performance on scenes kept independent of training.
Why published image counts are not a universal minimum
A data count only means something when you know what was counted and what the model must handle. One “image” might be an original photograph of a road section, a close-up crop from a larger image, or a patch derived from the same scene as several other patches. Those units do not represent equal amounts of independent coverage. A thousand related crops can expose a model to many local textures while still leaving it unfamiliar with a new road, camera, lighting setup or material.

The target matters just as much as the count. A model trained to outline visible cracks in close-range asphalt images faces a different task from one expected to find hairline cracks in concrete at a distance. Crack width, contrast, orientation, surface texture, shadows, markings and debris all affect how much variety the training set needs. The label definition also matters: pixel-level masks for narrow, ambiguous cracks can be harder to produce consistently than broader region labels.
Published counts are best read as examples of what particular experiments used, not as promises that the same amount will work for another deployment. None of the reported figures establishes a guaranteed minimum for a target site or camera that has not been specified.

What the reported datasets and studies actually counted
These figures differ in both task and counting unit. In particular, do not compare original scenes directly with derived patches as though each patch were a new independent capture.
| Study or dataset description | Reported amount | How to interpret it |
|---|---|---|
| 2020 IEEE Access pavement U-Net study, using the CFD split | 72 training images; 46 test images | A particular pavement experiment and split, not a recommended minimum. Its training examples were augmented with random rotations, horizontal and vertical flips, and modest lighting and contrast variation. |
| RUC-Net study’s description of DeepCrack | 537 images total; 300 training images and 237 test images | The split reported for DeepCrack in the 2022 study. A 2023 APC-GAN/AttuNet study also used 300 DeepCrack training images for its own model and augmentation comparisons. |
| RUC-Net study’s description of Crack500 | 500 original images; 1,896 training, 348 validation and 1,123 test cropped patches | The patch counts are crops derived from the original high-resolution images, not thousands of independent original scenes. |
| Surface-defect segmentation study, 2019 | Approximately 25–30 defective training samples | A specific surface-defect case; it is not a crack-specific minimum and should not be treated as evidence that a crack model generally needs only this many examples. |
| Ultralytics Crack-Seg dataset listing, 2026 | 4,029 images: 3,717 training, 200 validation and 112 test | A dataset listing and split description, not proof that 4,029 images are sufficient for a different deployment. |
The table illustrates why a count alone is weak evidence. The 72-image CFD experiment used a held-out test set in its own setting; the DeepCrack figures use a different dataset and split; Crack500’s larger split counts refer to patches; and the small surface-defect report is not specifically about cracks. These results cannot be ranked by count to infer that one target task is easier or that a smaller dataset is enough.
Can you train a crack model with a small dataset?
Possibly, if “small” is understood relative to a tightly defined target and if the examples cover the conditions the model will encounter. The approximately 25–30 defective training samples in the 2019 surface-defect study show that a segmentation task can be explored with few defective samples in a specific case. They do not establish that a crack-segmentation system will work reliably from that amount, especially when its deployment conditions differ from its training images.
A small pilot can still be useful. It can expose annotation problems, reveal obvious failure modes and indicate whether the chosen model and image acquisition setup are promising. Treat pilot success as a reason to measure further, not as proof of reliable performance on unseen locations or conditions. If the target varies substantially, a narrow set of examples can make a model appear capable during evaluation while leaving important deployment cases uncovered.

“Small dataset” also needs a precise unit. A small number of original scenes can produce many crops, but those crops remain correlated with their source scenes. They help with local training examples; they do not automatically provide the same evidence as new independent capture sessions, sites or surfaces.
Estimate your own data need with a learning curve
The practical answer is an experiment on your project data. A learning curve shows how held-out performance changes as you add labeled training examples. It is more informative than borrowing a published count because it tests the actual target conditions and acceptance criteria.
- Define the deployment target. Write down the surface or material, image source and resolution, camera distance, viewpoint, lighting, and operational meaning of a “crack.” Specify whether masks should include hairline or partly obscured cracks and how uncertain edges will be labeled.
- Assemble a representative pilot. Include the range of conditions expected in use: different textures, crack widths and orientations, lighting, distances and surface states. Add representative crack-free scenes and hard negatives, such as shadows or joints that could be mistaken for cracks, when false positives matter.
- Reserve independent validation and test data. Separate examples by original scene, location, capture session or another meaningful group. If multiple crops come from one source image, keep related crops in the same split. Otherwise, closely related visual content can appear in both training and evaluation and make the result look better than performance on genuinely new scenes.
- Train on progressively larger subsets. Keep the model, preprocessing and evaluation procedure comparable while increasing the amount of training data. The increments need not be fixed in advance; choose sizes that let you see whether adding labels changes results enough to matter for the project.
- Measure the result that matches the use case. Select the primary segmentation metric before comparing runs. A single aggregate score is not enough to diagnose the model, so also inspect false negatives, false positives, narrow cracks and difficult backgrounds on held-out data.
- Review condition-specific failures. Record whether errors cluster around a material, lighting condition, camera distance, crack width or background type. If they do, more examples of that condition may be more useful than adding more near-duplicates of cases the model already handles.
- Continue until the operational bar is met and stable. Add and label examples where new data materially improves held-out results or fills a documented coverage gap. Stop only when performance meets the project’s stated requirement and remains stable across relevant conditions—not because a published dataset had a particular number of images.
This procedure is practical guidance based on the studies’ use of held-out splits and the variation among their datasets; it is not a universal published sample-size protocol. The amount required is the amount that produces dependable results for the defined deployment, as demonstrated by appropriately independent evaluation.

Design validation so it predicts deployment
A validation set should test the conditions the model is supposed to handle, not merely provide more images from the same narrow source. If the intended use spans different locations, capture sessions or surfaces, include those differences in evaluation. When the only validation images closely resemble training scenes, a strong score may say little about transfer to a new camera or surface.

Keep the role of each split clear. Training data updates the model. Validation data helps compare choices during development, such as the amount of training data or augmentation strategy. A final test set should remain independent of those choices so it can provide a less biased estimate of the selected model’s performance. The cited studies report their own train/test or train/validation/test splits; their split sizes should not be copied blindly if your images have a different structure.
For crack imagery, grouping by the source scene is especially important when high-resolution images are cropped into patches. Randomly distributing sibling crops across training and validation can allow the model to see nearly the same surface in both. For a stronger test of generalization, hold out whole scenes or, where relevant to deployment, locations or capture sessions.
What image augmentation can—and cannot—do
Augmentation creates transformed versions of existing examples. In the 2020 CFD pavement U-Net study, the authors used random rotations, horizontal and vertical flips, and modest lighting and contrast variation. Such transformations can expose training to altered orientations or appearance and may make limited data more useful for the conditions they plausibly represent.

A flipped or brightness-adjusted crop does not introduce a new pavement texture, camera distance, crack morphology or background. Synthetic variation should therefore be treated as a training technique, not evidence that representative real-world coverage is unnecessary.

Later work explores more specialized options. A 2023 APC-GAN/AttuNet study used 300 DeepCrack training images and reported results for its particular model and augmentation comparisons. A 2025 HybridAugment article frames acquisition and labeling cost as constraints while testing a specific method. A 2026 generative-data study tested synthetic data alongside real target-domain subsets ranging from 5% to 80% of its synthetic dataset across selected pavement datasets. Those percentages describe that experiment; they do not establish a general ratio of synthetic to real data for other projects.
When considering augmentation, check whether each transformation preserves the label and remains plausible for deployment. Rotating an image and its mask together can preserve the pixel correspondence, for example, while aggressive brightness or contrast changes may create appearances not seen in the target environment. Evaluate the resulting model on independent real images, not only on augmented training examples.

Turn the estimate into an annotation plan
Labeling takes time, so a useful plan focuses effort on information that can change the model’s behavior. Start by recording the range of deployment conditions and the kinds of mistakes that matter most. If missed cracks are costly, inspect false negatives closely; if a model will trigger costly follow-up inspections, characterize false positives on crack-free but visually confusing scenes as well.
Keep a simple inventory of the dataset that records each image’s source scene or capture group, material, conditions and whether it contains cracks. This makes it easier to detect gaps and to create splits that do not leak related imagery. It also helps target the next round of labels: if errors concentrate on dark, low-contrast cracks or a particular texture, prioritize representative examples of that case.
Annotation consistency deserves attention alongside volume. Pixel masks depend on where annotators place boundaries, especially for very narrow or indistinct cracks. Define how to handle uncertain boundaries and apply that rule consistently across training and evaluation. Otherwise, apparent model errors can partly reflect inconsistent ground-truth labels rather than a shortage of examples.

Do not set a stopping point from a single favorable run or score. Compare progressively larger subsets, examine performance on the same independent evaluation groups, and look for stability across the conditions that matter. If additional data still improves important outcomes, or a known deployment condition remains underrepresented, the current count is not yet a sound basis for stopping.
A practical answer for your project
For planning purposes, begin with a representative pilot rather than a universal target such as “a few hundred images.” The literature includes a 72-image training split, a 300-image training split, thousands of derived patches, and a separate small-sample surface-defect example; each describes a distinct experiment or dataset. None tells you what count will satisfy an untested camera, material, location or acceptance threshold.
The defensible number comes from your own held-out learning curve. Count independent scenes as well as crops, reserve evaluation data by meaningful source groups, and add labels where measured performance or coverage remains inadequate. If that process shows stable results against the operational requirement on deployment-relevant conditions, you have evidence for the amount your project needs—rather than an assumed minimum borrowed from another task.
