How HyQuant Uses Hybrid-Precision Attention to Cut Decode Compute

HyQuant preserves selected attention positions and recent context in high precision while using low-bit formats elsewhere. The authors report decode-kernel speedups up to 3.58×, smaller end-to-end gains, near-baseline benchmark averages and measurable memory and runtime costs.

HyQuant reduces attention compute by keeping a small set of influential key positions and recent context in full precision while representing most other attention and key-value (KV) states in low-bit formats. In experiments reported by its authors, this approach produced decode-kernel speedups of up to 3.58× over FlashAttention-2, while end-to-end decode gains were smaller—1.04× to 1.17×—and tested benchmark scores stayed close to the full-precision baseline. These are results on a defined set of models, tasks and hardware, not a general guarantee for every inference system.

What hybrid-precision attention changes

Attention does not distribute its importance evenly across a long sequence. Some key positions attract attention repeatedly across many queries, while nearby recent tokens can also be especially relevant. HyQuant uses this pattern to assign different numerical precision to different positions instead of storing or processing every position uniformly.

Its central policy is to retain selected “vertical-line” positions—tokens that receive sustained attention across queries—and a recent local window in full precision. Most other positions use low-bit representations. The paper describes two related uses: during prefill, compute selected positions and the local window in full precision while processing the rest of the context in low precision; during decode, store most of the KV cache in low-bit form and preserve selected positions at higher precision.

For decode, HyQuant fuses dequantization with attention rather than first expanding the entire compressed cache into a full-precision copy. That design is intended to limit the memory traffic and extra work that could otherwise erode the benefit of low-bit storage. The authors describe their selection signals as “lightweight vertical-line-aware attention-pattern signals.” (HyQuant paper and abstract)

Why preserve selected positions?

The method’s premise is that quantization errors in a few attention-critical positions can matter more than similar errors elsewhere. In the authors’ analysis of Llama-3.1-8B, the top 5% of key positions plus a 128-token local window covered 85.63% of measured attention mass. For Qwen3-8B, the same selection covered 82.53%. These are measurements for those two models and settings, not a universal property of language-model attention.

A separate operator-level analysis on Qwen3-8B compared intermediate attention-output mean squared error with full-precision FlashAttention. The authors report that retaining the top 1% or 5% of high-score positions in full precision while quantizing the rest to 4-bit brought error toward the uniform 8-bit error level across sequence lengths from 1K to 32K tokens. This measures error in the attention computation; it does not by itself establish downstream task accuracy.

What the authors tested

The paper evaluates four models: Qwen3-8B, Qwen3-32B, Llama-3.1-8B-Instruct and GLM-4-9B-0414. The authors report LongBench v1 results for long-context tasks, along with GSM8K and MATH500 results for mathematical reasoning. Their experiments used an NVIDIA H100 GPU. In the reported implementation, the top 5% of vertical-line tokens and a local window remained in high precision, while remaining KV positions used Key-4bit and Value-4bit formats. Reported speedups: kernel gains are not end-to-end gains

Against FlashAttention-2, the authors report progressively larger decode-kernel speedups at longer tested prefix lengths. End-to-end decode speedups over the same baseline were more modest:

Prefix length Decode-kernel speedup End-to-end decode speedup
1,024 tokens 1.32× 1.04×
2,048 tokens 2.40× not stated in the reported figures
4,096 tokens 3.06× not stated in the reported figures
8,192 tokens 3.36× not stated in the reported figures
16,384 tokens 3.52× not stated in the reported figures
32,768 tokens 3.58× 1.17×

Kernel speedups isolate the attention decode kernel, whereas end-to-end figures include a broader inference path. The distinction matters: a faster kernel can translate into a smaller application-level improvement when other work in the serving pipeline remains unchanged. The paper reports an end-to-end range of 1.04× to 1.17× across the listed prefix lengths but the summary figures do not assign every intermediate value to an individual prefix.

Benchmark accuracy stayed close to the baseline

On the Qwen3-8B thinking-mode LongBench v1 table, the authors report an average score of 45.04 for HyQuant and 44.59 for full-precision FlashAttention-2 across 11 listed tasks. For Llama-3.1-8B-Instruct, the reported averages are 46.73 and 46.63, respectively. These small differences are measured benchmark outcomes, not evidence that quantization makes the underlying models more capable; the authors characterize such small above-baseline differences as normal evaluation variance.

These averages should be read alongside the evaluation scope: four named models, selected benchmarks, the authors’ implementation and H100 experiments. They do not establish that the same quality-speed trade-off will hold for other models, prompts, context distributions, hardware or serving stacks.

Memory and runtime costs

Precision selection and high-precision retention are not free. The authors attribute 3%–5% of total runtime to identifying vertical-line positions. At the reported 5% retention setting, keeping vertical-line tokens in full precision increased non-window KV-cache size by about 15% versus strict 4-bit storage. Total additional cache cost also depends on the size of the full-precision local window.

The retained-token ratio and window size are operational trade-offs. The authors’ ablation reports that increasing the retained-token ratio generally reduces quantization error and improves accuracy, at the cost of a larger high-precision memory budget; a larger full-precision window slightly improved accuracy in that ablation. The best setting therefore depends on whether a deployment is more constrained by cache capacity, latency, or quality requirements.

What these results do—and do not—show

HyQuant offers evidence that attention precision can be allocated selectively rather than uniformly: in the tested setup, authors reported substantial kernel acceleration at long prefixes while benchmark averages remained near the FlashAttention-2 baseline. Its practical value depends on the workload and implementation, particularly because kernel-level gains exceeded end-to-end gains and selection plus retained precision carry measurable costs.

  • Supported by the reported experiments: results on the four named models, listed benchmarks, H100 hardware, the stated 5% retention implementation and tested prefix lengths.
  • Not established by those experiments: independent replication, compatibility with every inference or serving stack, or consistent behavior across all model architectures and production workloads.
  • Useful comparison axes: task scores against a full-precision baseline; kernel versus end-to-end latency; context length; KV-cache bit format; retained-token fraction; local-window size; selection overhead; and cache-memory overhead.

For practitioners assessing the method, the authors’ code repository and paper provide the appropriate starting points for evaluating whether the reported trade-off transfers to a particular model and deployment. A like-for-like measurement should include both the attention kernel and the full inference path, along with memory use and task quality.
