Fault-Tolerant Training Frameworks: What to Know About Recovery After Hardware Failures

A restart does not restore training progress by itself. Compare documented failure reporting, restart policies, sharded checkpoint recovery, and integration constraints across PyTorch and NVIDIA NeMo.

Recovering distributed training after a hardware failure requires more than restarting workers: the system must detect or report the problem, restart the appropriate processes, and load a checkpoint that contains the training state needed to continue. PyTorch TorchElastic handles membership changes and retries; PyTorch Distributed Checkpoint and NVIDIA NeMo Distributed Checkpoint handle sharded state; NeMo Resiliency Extension adds documented hang detection and restart behavior. These are cooperating mechanisms, not interchangeable all-in-one guarantees.

What does fault tolerance mean during distributed training?

A training run can fail in several places: a worker process may exit, a worker may stop making progress, or the platform or underlying infrastructure may report a problem. A resilient setup has to address three distinct jobs:

As an Amazon Associate I earn from qualifying purchases.

  • Detection and reporting: surface a worker error, hang, or platform/infrastructure error to the process responsible for managing the job.
  • Restart: relaunch a worker group or job, subject to the launcher or framework’s retry policy.
  • State recovery: load saved training state so the restarted run can continue from a previous point rather than begin without its progress.

A restart limit controls how many restarts are allowed; it does not, by itself, preserve model or optimizer progress. Likewise, a checkpoint format does not necessarily detect a hang or restart a failed job.

How do the documented mechanisms compare?

Mechanism Failure detection or response documented Restart and recovery scope Checkpoint and portability details Important constraint
PyTorch TorchElastic Describes node failure as a scale-down or membership change, and node replacement as scale-up. Its error propagation documentation covers user errors, worker failures, platform errors, and infrastructure errors; worker errors can be propagated from child processes through the agent to the scheduler. --max-restarts limits restarts triggered by failure or scaling events. TorchElastic provides launcher and membership-management behavior, not state durability. The training program needs its own reliable save-and-load path. TorchElastic alone does not establish checkpoint contents or portability. Recovery of training progress depends on the training program’s checkpoint implementation and the surrounding scheduler/platform.
PyTorch Distributed Checkpoint Designed for distributed checkpoint save and load; it is not itself the job restart mechanism. Sharded checkpoints allow each GPU to save and load its portion. Metadata guides which shards are needed after resumption, including when cluster composition changes. Supports sharded save/load across a changed cluster composition, subject to the integration used by the training application. Must be paired with a mechanism that detects failure and restarts or relaunches the training job.
NVIDIA NeMo Distributed Checkpoint, part of Megatron Core Provides distributed training-state save and load for multiple GPUs or nodes; the guide describes recovery from interrupted training. Parallel save/load entrypoints and sharded formats support resumption, including with different parallelism strategies when the necessary integration is implemented. Documented sharded backends are PyTorch Distributed and Zarr. Different-parallelism resumption depends on the training integration; it should not be assumed from the checkpoint format alone.
NVIDIA NeMo Resiliency Extension Documents hang detection and automatic restart from the last checkpoint. Restart is coupled to retrieval of the latest valid checkpoint in the documented setup. The NeMo Framework 25.07 guidance describes local checkpointing, optional multi-node replication, and automated retrieval of the latest valid checkpoint. The documented local-checkpoint integration applies to Megatron Core models using MegatronStrategy.
DeepSpeed activation checkpointing The cited documentation describes activation-memory optimization, including activation partitioning across GPUs and CPU checkpointing. These features address activation memory; the cited page does not establish job restart or recovery of durable training state after hardware failure. Activation checkpointing is not synonymous with a durable training-state checkpoint. The cited activation-checkpointing material is not enough to characterize DeepSpeed’s overall fault-tolerance behavior.

These descriptions are not a controlled comparison of failure rates, overhead, or recovery time. They also do not establish identical coverage for GPU, node, network, and storage failures. PyTorch’s engineering article describes one Composer integration that can upload checkpoints as frequently as every 30 minutes and automatically resume after a node failure in less than 5 minutes. Those figures describe that vendor example, not a general PyTorch guarantee or an independent benchmark.

How do I recover distributed training after a node failure?

Plan the recovery path as a sequence, with each part assigned to a system that actually provides it:

  1. Surface the event. Configure the launcher, scheduler, or framework integration to report worker and infrastructure errors. For TorchElastic, worker errors are propagated from child processes through the agent to the scheduler; this reports a failure but does not repair hardware.
  2. Decide what restarts. Use the job or launcher’s restart policy and understand its limit. TorchElastic’s --max-restarts applies to restarts caused by failures as well as scaling events.
  3. Save the state required to continue. Implement checkpoint save and load in the training application, or use an applicable distributed checkpoint integration. A launcher restart without a loadable checkpoint does not restore lost training progress.
  4. Choose checkpoint placement and replication for the failure you expect. NeMo 25.07 documents local checkpointing with optional multi-node replication and retrieval of the latest valid checkpoint. Local checkpointing has the Megatron Core plus MegatronStrategy integration requirement described above.
  5. Exercise the whole recovery path. Verify that the failure is surfaced, the intended process group restarts, the checkpoint is discoverable and loadable, and training resumes with the expected state. The cited documentation does not provide a common test protocol or recovery-time guarantee across these systems.

Can training resume if the number of GPUs changes?

It can when the checkpoint and training integration support resharding or remapping state for the new cluster composition. PyTorch Distributed Checkpoint is designed for parallel, sharded save/load and uses metadata to guide which shards are needed after a composition change. NeMo Distributed Checkpoint documents resumption with different parallelism strategies when the required integration is implemented.

This is different from simply restarting with a different number of workers. TorchElastic treats node loss and replacement as membership changes, but its restart behavior does not itself make the application’s saved state portable. Check that the specific model, checkpoint format, and parallelism integration support the intended change before relying on it.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

What is the difference between restarting a job and restoring a checkpoint?

  • Restarting starts processes again, possibly with a changed worker group. TorchElastic’s restart limit governs attempts to do this.
  • Restoring loads previously saved training state. Distributed checkpoint mechanisms save and load sharded state; the exact state and application integration determine what can be resumed.
  • End-to-end recovery requires both, plus a failure signal and a checkpoint accessible to the restarted run.

NeMo Resiliency Extension documents a combined path of hang detection and restart from the last checkpoint. That documented combination should not be generalized to every framework or failure type.

Which option fits a particular training setup?

  • If the immediate need is restart and membership management: TorchElastic documents node membership changes and a configurable restart limit. Pair it with application-level checkpointing if training progress must survive a restart.
  • If state is sharded across GPUs or nodes: PyTorch Distributed Checkpoint or NeMo Distributed Checkpoint documents parallel, sharded save/load. Choose according to the model stack and integration you actually use.
  • If hang detection and checkpoint-based restart are required in a NeMo setup: NeMo Resiliency Extension documents those behaviors; check the version-specific guidance and model strategy requirements.
  • If you are evaluating activation checkpointing: distinguish its activation-memory role from persistent training-state recovery and job restart.

No cited material establishes one framework as “most fault tolerant,” ranks recovery overhead, or gives comparable recovery-time distributions. The practical choice depends on the failure model, scheduler, storage arrangement, model family, checkpoint integration, and whether cluster composition may change.
