CPU + GPU: What AI Platform Teams Need to Know About Heterogeneous Infrastructure

Production AI performance depends on more than the number of GPUs. CPU work, memory, storage, networking, and application orchestration all affect whether data and model artifacts reach an accelerator in time—and whether results can move on to the next step. For Kubernetes platform engineers and infrastructure architects, capacity planning works best when it follows the workload from input to output.

Why GPU count is not a complete capacity plan

“How many GPUs does this workload need?” is a reasonable starting question, but it leaves out the resources that prepare, feed, and use those GPUs. A production inference path can include data preparation, CPU preprocessing, GPU inference, CPU post-processing, and application work. If one stage cannot keep up, the accelerator may wait even when the model’s computation is well suited to a GPU.

Kasia Hilborne, writing for the Cloud Native Computing Foundation (CNCF) and identified as affiliated with Vultr, describes the conceptual shift this way: “The key shift is conceptual: AI infrastructure is not a collection of GPUs with supporting services around them.” The practical question is: “What resources does each stage need, and where are the dependencies between them?” CNCF’s September 4, 2026 article frames the workload as a connected system rather than a single accelerator requirement.

Trace the workload through its stages

Map what happens to a request or training job in sequence. The exact stages vary, but the resource roles often look like this:

Stage Typical work Resources to account for
Data preparation Read, validate, transform, or assemble input data CPU, memory, storage, and network access
Preprocessing Tokenization or other transformations before inference CPU and memory; storage or network capacity where data is fetched
Inference or training computation Run model operations, often with highly parallel computation GPU or another suitable accelerator, plus memory and data movement
Post-processing Transform, filter, or format model output CPU and memory
Application and orchestration Handle requests, coordinate services, and manage the job lifecycle CPU, memory, networking, and the orchestration platform

This is a planning framework, not a benchmark or fixed sizing prescription. Measure the actual workload: a stage that appears small in a diagram can still constrain throughput if its inputs arrive slowly or it has insufficient resources.

Account for the resources around the accelerator

CPU

CPU capacity may be needed for data preparation, tokenization, retrieval, orchestration, application logic, and post-processing. If these tasks cannot supply or consume work at the pace of GPU computation, adding accelerators alone may not improve end-to-end performance.

Memory

Memory supports active data and model work across the pipeline. Its requirements depend on the workload and stage; an accelerator’s compute capacity does not eliminate memory constraints elsewhere in the system.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Storage and networking

Storage access and network transfer affect how quickly inputs and model artifacts reach compute resources, and how outputs move onward. A bottleneck here can limit throughput or slow model startup even when GPU capacity is available. For distributed training or inference, communication between participating devices is also part of the workload, not an incidental detail.

Separate the phases of LLM inference

Large language model inference should not automatically be treated as one uniform operation. Prompt processing and token generation can have different compute and memory requirements. When planning capacity or investigating latency, consider these phases separately rather than assuming one GPU-utilization number describes the whole request.

The relevant mix depends on the workload. Track the stages that matter to its service requirements, including latency and throughput, and check whether the constraint shifts between prompt processing, generation, CPU-side work, or data movement.

Diagnose bottlenecks with correlated telemetry

Low GPU utilization does not identify the cause by itself. It may reflect insufficient demand, or an upstream constraint such as CPU preprocessing, data access, or scheduling. Looking at GPU utilization in isolation cannot distinguish those cases.

Correlate application and infrastructure telemetry so that time spent in each stage can be compared with resource activity and handoffs. Useful evidence includes workload throughput, startup time, latency, and the CPU, GPU, memory, storage, and network behavior associated with the same workload. Interpret each measure against the workload’s stated requirements: the goal is to meet those requirements, not to drive every resource to 100% utilization.

Plan resource requests and orchestration together

Kubernetes is a common orchestration layer for production AI workloads. The platform plan needs to account for how specialized devices are requested as well as how ordinary CPU and memory resources are allocated. Dynamic Resource Allocation (DRA) is one example of a more flexible, declarative resource-request model for specialized devices; whether it fits a deployment depends on its Kubernetes environment and device support.

For teams using cloud infrastructure, GPU instances can provide accelerator capacity, while workloads that require distributed communication may call for GPU clusters and an appropriate fabric. For example, Vultr’s Cloud GPU documentation describes NVIDIA and AMD GPU virtual machines for AI, machine learning, and HPC workloads. Its cluster guide, updated April 23, 2026, describes GPU-fabric clusters for AI/ML training and distributed inference using RoCE or InfiniBand. These are examples of service capabilities, not evidence that a particular provider or configuration is the right choice for every workload.

Vultr documents both self-managed Kubernetes clusters and its managed Vultr Kubernetes Engine (VKE); its support page says VKE supports virtual compute instances including Cloud GPU. See the Kubernetes support documentation, updated April 15, 2026. Confirm that the specific instance, device, orchestration configuration, and workload requirements align before deployment.

A practical planning sequence

  1. Write down the workload path. List input preparation, preprocessing, model computation, post-processing, and application or orchestration work that actually occurs.
  2. Assign resource needs by stage. Note CPU, accelerator, memory, storage, and network requirements rather than recording only GPU count.
  3. Mark the handoffs. Identify where data, model artifacts, and outputs move between stages, and what must be ready before the next stage can proceed.
  4. Define service requirements. Set the relevant throughput, latency, and startup expectations for the workload before deciding whether capacity is adequate.
  5. Observe the complete path. Correlate application timings with infrastructure telemetry to find where work waits or falls behind.
  6. Adjust the constrained stage. Change the resource allocation or data path indicated by evidence, then verify the result against the same workload requirements.

This approach makes the capacity decision about the system that delivers inference or training, not just the component with the densest computation.
