AI projects become hard to maintain when teams add components, abstractions, and model-driven steps without clear requirements—or when they leave evaluation, data handling, and ownership implicit. The fix is not to avoid AI or minimize components at all costs: keep each boundary tied to a real need, and measure whether the system remains understandable, testable, and changeable.
Why AI projects accumulate complexity
An AI-enabled product has more moving parts than its model alone: software, data, evaluation, and operational dependencies all affect behavior. When responsibilities blur, pipelines become tightly connected, or a language model is asked to handle persistent knowledge and deterministic computation, a change in one area can become difficult to trace through the rest.

A 2024 study of technical debt in AI-enabled systems describes problems including “Pipeline Jungle” and “Jumbled Model Architecture.” These are research descriptions of maintenance challenges, not evidence that every pipeline or multi-component design is overengineered. The study’s indexed abstract supports those examples; its detailed methods are not established here. Read the study abstract.

A demo may show that a particular input works, but it does not by itself establish how failures will be evaluated, how behavior will be traced, or how data and models will be handled through their lifecycle. The Software Engineering Institute’s April 22, 2026 update to its AI engineering practices identifies evaluation, security, traceability, uncertainty, oversight, and lifecycle data concerns as core areas of attention. What evidence says about complexity and maintenance
A 2025 Google Research study examined more than 1,200 internal C++ and Java projects and used 7,200 survey responses to inform its developer-sentiment analysis. In that setting, higher propagation cost and structural anti-patterns were associated with more code spent on bug fixing. The study supports monitoring complexity and maintenance together; it does not prove that complexity alone caused the maintenance burden, nor does its sample establish a universal result for AI projects.
The paper’s abstract notes: “Without effective complexity and maintenance measures, it remains difficult to objectively monitor maintenance, control complexity, or justify refactoring.” Read the Google Research study.

Vendor benchmarks can provide additional context, but should not be treated as a forecast for a particular team. Software Improvement Group’s 2026 State of Software report says its benchmark draws on data across tens of thousands of systems. SIG reports that 1.9% of enterprise production code is AI-generated, that AI-generated code had roughly twice the security risk violations of human-written code in its benchmark, that 86% of code was below its recommended maintainability rating, and that 72% of production AI systems were below that rating. These are separate publisher-reported figures, not universal rates or a neutral estimate for any individual codebase; comparisons require the report’s definitions and methodology. See SIG’s State of Software 2026.

For structured enterprise workflows with demanding cost, latency, and reliability requirements, it can make sense to use an LLM as an interface—for interpretation or extraction—while dedicated components handle persistent knowledge, storage, and deterministic procedures. Microsoft Research authors Kuldeep Singh, Anson Bastos, and Isaiah Onando Mulang argue in a May 2026 position paper that this separation can improve reliability, scalability, and transparency. They write: “Instead, AI systems should treat language models as interfaces rather than monolithic engines, externalizing knowledge and computation into dedicated components for greater reliability, scalability, and transparency.” This is a scoped architectural argument, not a rule for every AI product. Read the Microsoft Research position paper.
The practical question is not whether a design has one component or many. Compare alternatives by how changes propagate, how failures can be evaluated and traced, how they perform on the target workload, who owns each part and its data, and whether an extra component solves a named requirement.
A maintainability process for AI projects
- Start with the use case. Write down the behavior the system must support and the constraints that matter, such as reliability, latency, cost, or oversight. Treat a new service, agent, framework, or abstraction as a proposal that must address one of those needs.
- Draw responsibility boundaries around real changes. Identify what is likely to change independently: for example, model behavior, data storage, evaluation cases, or a deterministic business procedure. Separate components when doing so reduces coupling, clarifies ownership, or makes a failure easier to isolate—not simply because a pattern is fashionable.
- Make evaluation part of development. Define representative cases and failure checks before relying on a demo. Revisit them when data, prompts, models, or surrounding components change. The SEI’s guidance treats evaluation as a core AI engineering practice, alongside areas such as security, traceability, uncertainty, oversight, and data lifecycle management.
- Monitor maintenance signals over time. Track whether changes spread unexpectedly across components, whether bug fixing consumes increasing effort, and whether structural problems are becoming harder to address. The Google study supports objective, continuous monitoring in its project setting; use indicators that fit your own system rather than treating one metric as a universal threshold.
- Record why boundaries and dependencies exist. Keep the decision, the behavior or risk it protects, the owner, and the conditions that would justify reconsidering it. This makes architecture easier to trace when the workload or model changes.
- Simplify deliberately. Remove a layer when it no longer protects a requirement or helps evaluation, ownership, or operations. Check the change against evaluation cases and operational constraints; fewer components alone do not guarantee a better design.
How to decide whether an architectural layer is worth keeping
| Question | What a useful answer establishes |
|---|---|
| Does it reduce change propagation? | A change in one responsibility is less likely to force unrelated changes elsewhere. |
| Does it make behavior easier to evaluate or trace? | The team can connect observed outcomes to the relevant component, data, or decision. |
| Does it meet workload constraints? | Reliability, latency, and cost are judged against the actual use case, not assumed from the architecture pattern. |
| Is ownership and data handling clear? | People can identify who maintains the component and how its data lifecycle is managed. |
| Does it serve a named requirement? | The team can explain the specific need the layer addresses and what evidence would show that it helps. |
If the team cannot answer these questions, that is a reason to investigate—not automatic proof that the component should be removed. Conversely, if an existing boundary has no clear responsibility or benefit, revisit it rather than letting it persist by default.
