Which GPU Settings Matter Most for AI Workloads?

For AI workloads, check whether the model fits in GPU memory, identify the performance bottleneck, then evaluate power and thermal limits. Utilization is a diagnostic signal, not a score.

For AI workloads, prioritize GPU settings in this order: make sure the model and its runtime allocations fit in memory, find what limits performance, then check whether power or thermal controls are constraining the GPU. Memory capacity, memory bandwidth, power limits and utilization describe different things; there is no universal utilization target or setting that makes every model run faster.

Start with the workload’s goal and memory fit

Before changing a setting, record the GPU model, driver, framework and runtime, model, precision, batch size or concurrency, and the goal: lower latency, higher throughput, or better energy efficiency. GPU features and available telemetry vary by card and platform, so compare settings on the system and workload you actually use.

Check total, used and free framebuffer memory, along with the application’s allocation behavior. Capacity determines whether the model’s weights, activations, cache and runtime allocations can fit. If the workload is near the card’s limit, identify which allocations it needs and whether its configuration can fit before tuning power or utilization.

Memory accounting is not always a direct measure of what an application owns. NVIDIA notes that ECC can reduce reported available framebuffer memory, the driver may reserve memory, and operating-system accounting can affect reported values on NUMA systems. Allocated pages may also remain after a process ends to improve performance. Treat total, free and used readings as system-level clues, and check application behavior as well.

Separate capacity, bandwidth and data movement

Memory capacity answers whether data fits; bandwidth concerns how quickly data moves to and from GPU memory. A memory-bandwidth utilization reading is not the amount of memory allocated. NVIDIA DCGM defines it as an interval measure of cycles with device-memory traffic.

Performance can also be limited by moving data between the host and GPU. NVIDIA’s CUDA C++ Best Practices Guide advises minimizing host-device transfers, even when that means running a GPU kernel that is no faster than its CPU counterpart: CUDA C++ Best Practices Guide 13.4. If GPU activity is low, investigate input preparation, data transfers, synchronization, small workloads and contention before raising a power limit.

Read utilization as a clue, not a score

In nvidia-smi, GPU utilization is the share of the sample period during which one or more kernels executed. Its memory utilization field is the time during which global device memory was being read or written. The sample period varies by product from one second to one-sixth of a second. Neither percentage establishes throughput, latency, tensor-pipe activity or how much useful work was completed.

DCGM profiling values are interval averages, too. NVIDIA cautions that “Higher occupancy does not necessarily indicate better GPU usage.” Occupancy may be more informative for memory-bandwidth-limited work, but does not necessarily correlate with effectiveness for compute-limited work. Check tensor and memory activity in the context of the workload phase rather than treating any one percentage as a verdict. See NVIDIA’s DCGM Feature Overview.

Check whether power or temperature is limiting performance

A GPU power limit is a ceiling, not a performance target. NVIDIA describes power management as limiting draw under load to stay within a predefined power envelope, adjusting the performance state as needed. A low power reading does not by itself mean the GPU is faulty: the workload may not be demanding enough, or another bottleneck may prevent it from drawing more power.

Where supported, compare current or requested power limit with the limit actually enforced by power management, and monitor power draw, clocks and temperature. Firmware or platform policy can impose a stricter cap. For example, on DGX B200 the PMU selects the most conservative policy; this behavior is specific to that system family, not a universal description of every GPU.

Lowering a power limit can constrain performance when the workload would otherwise use more power, but its effect depends on the workload and the system’s limits. A lower limit might improve energy efficiency while reducing peak throughput; the only useful answer for a particular setup comes from comparing runs against the objective you care about.

Diagnose in a repeatable order

  1. Define the baseline. Record the GPU, driver, framework and runtime, model, precision, batch size or concurrency, and whether you are optimizing latency, throughput or energy efficiency.
  2. Check fit. Inspect framebuffer memory totals and application allocations. If memory is close to capacity, determine whether the model, activations, cache and runtime can fit before changing other controls.
  3. Sample power and operating conditions. Use nvidia-smi or the platform management interface to inspect power draw, requested and enforced limits where available, clocks and temperature.
  4. Find the bottleneck. For a busy GPU, distinguish compute or tensor activity from device-memory traffic. For low GPU activity, examine CPU-side input preparation, transfers, synchronization, small workload size and contention.
  5. Compare representative runs. Keep the model, batch or concurrency, precision, software and input pipeline consistent. Change one control at a time and compare stable runs, not a short snapshot.

Track throughput or latency alongside memory headroom, power, clocks, thermal constraints, tensor activity and memory activity. Align monitoring windows with workload phases: nvidia-smi utilization is sampled, while DCGM profiling values are interval averages.

Choose GPU configurations by more than utilization

When comparing configurations, weigh the factors that can determine whether your workload fits and how it runs:

  • Usable memory capacity and workload fit.
  • Compute throughput relevant to the model’s precision and kernels.
  • Device-memory bandwidth, interconnect behavior and host-transfer needs.
  • Sustained performance within the system’s power and thermal envelope.
  • Performance per watt, cost and operational constraints, judged against your objective.

A higher utilization percentage alone is not a sound way to rank GPUs. The right configuration depends on which resource limits the workload and what outcome matters most.
