When Thinking Harder Makes AI Worse: A Case for Multi-Model Reasoning

More AI reasoning is not always better. Research finds that extended thinking can hurt performance in some evaluations, while parallel and multi-agent approaches help only under particular tasks, budgets and information-sharing conditions.

Giving an AI more time to reason does not reliably make its answer better. In some controlled evaluations, accuracy rose with additional thinking and then fell; other studies found that parallel reasoning or multiple agents could help, but only under particular tasks, information-sharing rules, and compute budgets. The practical lesson is not “always use more agents.” It is to compare reasoning strategies fairly on the work you actually need done.

Why more reasoning can hurt

Many reasoning systems spend additional inference-time compute by generating longer chains of thought, revisiting an answer, or taking more reasoning steps. It is tempting to assume that each extra step can only help. That assumption does not hold in every evaluation.

The NeurIPS 2025 paper Does Thinking More Always Help? Mirage of Test-Time Scaling in Reasoning Models reports a non-monotonic pattern: additional thinking initially improved performance, then performance declined. The authors attribute the decline to overthinking and describe a mechanism in which additional thinking increases output variance, undermining precision. This is a finding about the models and evaluations in that study, not evidence that every model becomes less accurate whenever it reasons longer.

The distinction matters: more computation can create more opportunities to explore, but it can also introduce instability. A longer answer or reasoning trace is not itself evidence that the final answer is more reliable.

What the alternatives do

“Multi-model reasoning” can refer to several different ways of spending inference compute. Some methods create multiple candidate answers and aggregate them; others let agents critique or build on one another. These are not interchangeable, and their results depend on how much compute they use and how information is shared.

Independent parallel reasoning

Parallel thinking generates multiple independent reasoning paths and selects an answer based on consistency among them. In the NeurIPS 2025 study, the authors report that this approach achieved up to 20% higher accuracy than extended thinking in their experiments, within the same inference budget. “Up to” is the reported maximum, not a typical or guaranteed gain across tasks.

Self-consistency

Self-consistency also samples multiple answers, then uses agreement among those samples to choose a result. It is a single-agent strategy in the sense that it does not require a debate among distinct agents, although it does use multiple generations. An Association for Computational Linguistics study published in 2026 found that self-consistency saturated earlier than the multi-agent approaches it evaluated.

Debate and mixture-of-agents

In multi-agent debate, agents exchange arguments or challenge proposed answers. A mixture-of-agents approach combines outputs from multiple agents through an aggregation process. In the 2026 ACL evaluation, debate and mixture-of-agents outperformed self-consistency by 1.3 and 2.7 percentage points, respectively, at equal compute in the reported setup. The authors also found that multi-agent gains persisted particularly on more complicated tasks.

Those results do not mean that adding agents always improves a system. A 2025 ICLR Blogposts evaluation of five debate frameworks on nine benchmarks found that current debate methods did not consistently outperform simpler single-agent test-time computation, even when given increased compute.

What the studies found—and what their numbers mean

The figures below belong to specific research setups. They are useful for understanding the range of reported outcomes, but they do not establish a universal ranking for AI systems in production.

Study and comparison Reported result How to interpret it
NeurIPS 2025: parallel paths versus extended thinking Up to 20% higher accuracy for parallel thinking in the authors’ experiments, within the same inference budget. A maximum reported result for that method and study, not an across-the-board improvement.
ACL 2026: multi-agent methods versus chain-of-thought Up to 7.1 percentage points higher on MMLU-Pro at the highest evaluated budget, which was 20× the chain-of-thought compute budget. The maximum was achieved at substantially greater compute than the chain-of-thought baseline; it is not an equal-budget comparison.
ACL 2026: debate and mixture-of-agents versus self-consistency 1.3 percentage points higher for debate and 2.7 points higher for mixture-of-agents at equal compute in the reported evaluation. A budget-matched comparison within that study, which tested MMLU-Pro and BBH across 34 configurations and more than 100 evaluations.
ICML 2026: multi-agent systems versus single agents on HiddenBench 30.1% accuracy for multi-agent LLM systems under distributed information, versus 80.7% for single agents given complete information. The information conditions differed, so this result is not a direct, equal-information demonstration that single agents are better.

The ACL study’s 2026 findings cover MMLU-Pro and BBH, not every kind of reasoning task. Its reported maximum of 7.1 percentage points over chain-of-thought came at the highest evaluated compute budget, 20 times the chain-of-thought budget. Separately, the equal-compute comparison against self-consistency helps answer a different question: how methods compared when their compute was matched in that evaluation.

When multiple agents help—and when they do not

Task difficulty and model capability can change the result

A 2025 preprint found limited overall mathematical-reasoning advantages for debate over strong single-agent scaling. In that study, debate became more effective as problems grew harder and model capability decreased. That points to a conditional role for debate, rather than a general advantage independent of task or model.

More agents can still share the same blind spots

Multiple agents are not automatically more informed than one. The ICML 2026 paper introducing HiddenBench, a 65-task benchmark, found that multi-agent systems struggled when relevant information was distributed among agents. The authors traced this to difficulty recognizing information that other agents had but had not shared, which could lead to premature agreement based on the evidence already visible to everyone.

A structured communication protocol substantially improved performance in the HiddenBench experiments. The result highlights a design issue: when agents hold different pieces of evidence, a system needs a reliable way to surface and reconcile those pieces rather than simply asking agents to discuss their current conclusions.

Collaboration can affect safety as well as accuracy

The 2025 preprint also reported that collaborative refinement could increase vulnerability on safety tasks relative to zero-shot prompting, while diverse agent configurations gradually reduced attack success in that study. These results concern the tested safety tasks and configurations only; they do not establish that collaboration generally makes AI systems either safer or less safe.

Equal-compute tests can reverse an apparent advantage

A 2026 preprint comparing three model families on multi-hop reasoning reported that single-agent systems matched or outperformed multi-agent systems when reasoning-token budgets were held constant. Its authors also identified API budget-control artifacts and benchmark vulnerabilities. That is a reminder that a claimed advantage can depend on what counts as compute and how the evaluation is constructed—not just on the number of agents.

How to compare reasoning strategies fairly

If you are choosing a reasoning setup for a particular task, treat “think longer” and “use multiple models” as alternatives to test, not rules to follow. The comparison should measure both answer quality and the resources used to produce it.

  1. Define the target task. Use examples representative of the decisions or questions the system will handle. Include cases of different difficulty if that reflects real use.
  2. Record a baseline. Measure the current single-agent approach, including its answer accuracy and the types of errors it makes.
  3. Choose the alternatives to test. Depending on the task, compare extended reasoning, independent parallel samples, debate, or mixture-of-agents. Keep the method definitions clear so that “more agents” does not conceal different sampling or aggregation steps.
  4. Set a compute or token budget. Match total reasoning-token use or compute when the question is which approach is more effective for the same resource budget. If you also test a higher-budget configuration, report that separately rather than presenting it as an equal-budget win.
  5. Track the full setup. Record model family, task difficulty, number of generations, sequential aggregation or debate steps, and whether agents share the same context or hold different information.
  6. Evaluate more than the headline score. Record accuracy, recurring failure types, latency, and cost. A small accuracy gain may not be useful if it requires disproportionate compute or adds a consequential failure mode.
  7. Recheck on the intended use case. Benchmark results can guide which configurations to try, but the cited studies do not establish a universal winner for every current model or production workflow.

This process follows the central lesson of the comparisons: an apparent reasoning advantage is meaningful only in relation to a task, a budget, and an evaluation method. Counting agents or tokens alone is not enough.

What the evidence does not establish

  • It does not show how often everyday AI systems overthink in real-world use; the reported figures are benchmark study results, not prevalence estimates.
  • It does not show that every model or task deteriorates with longer reasoning.
  • It does not support a single ranking of extended thinking, parallel samples, debate, and mixture-of-agents across all tasks.
  • It does not prove that multi-agent systems are generally better or worse than single-agent systems; budget, task, model, information distribution, and evaluation design all matter.

The evidence spans studies published or posted in 2025 and 2026, but results remain tied to the tasks and model configurations tested. It does not establish outcomes for every current commercial model, live production workflow, or non-benchmark use case.

The practical takeaway

Longer reasoning can help, then stop helping; parallel and multi-agent methods can improve some results, but not reliably across every benchmark or budget. The strongest case for multi-model reasoning is therefore a conditional one: test it against a simpler approach on the target task, compare at a controlled compute budget, and account for errors as well as accuracy.
