Speculative Decoding vs. Standard Autoregressive Inference for Coding Agents

Speculative decoding uses a draft model and target verification to reduce sequential decoding steps, but coding-agent speedups depend on acceptance, overhead, and workload.

Speculative decoding can make a coding agent’s token generation faster, but it is not automatically faster than standard autoregressive inference. It has a smaller draft model propose several tokens at once, then asks the target model to verify them. The benefit depends on whether the saved target-model decoding steps outweigh the draft and verification costs. One independent Qwen2.5-Coder experiment found higher draft acceptance on code prompts than on prose prompts, but that setup-specific result is not a forecast for commercial agents or whole coding tasks.

How the two decoding methods differ

In standard autoregressive inference, the target model predicts one token from the prompt and tokens generated so far. The next target-model step must wait for that token, so generation proceeds sequentially. The 2025 NAACL paper Decoding Speculative Decoding describes this process as memory-bandwidth-bound on modern GPUs in the setting it discusses; actual bottlenecks vary with hardware and workload.

Speculative decoding adds a draft model. The draft proposes a short continuation, and the target evaluates the proposal in a verification pass. The method accepts a compatible prefix; if a token is rejected, a correction can be sampled. The original paper describes a rejection-sampling method that preserves the target model’s output distribution when implemented under its specified algorithm and assumptions: Fast Inference from Transformers via Speculative Decoding.

Related approaches may relax exact distribution matching and instead pursue a stated quality criterion. A benchmark should identify which method it measures rather than treating all draft-based decoding as equivalent; the NAACL study discusses this distinction.

What determines whether it is faster

The useful comparison is elapsed time or throughput for useful output tokens under matched conditions—not the number of tokens proposed or accepted alone. A draft has its own latency, while the target spends time verifying proposals. Cache handling, batching, concurrency, and serving-engine execution add further costs. A long proposal can save target steps when accepted, but wastes more draft work if it is rejected early.

The 2025 NAACL study measures throughput and target acceptance, and reports that draft autoregressive latency can become a bottleneck: increasing draft size may improve acceptance while reducing throughput because drafting takes longer. The LREC-COLING 2024 study, How Speculative Can Speculative Decoding Be?, examines lookahead choices and reports cases where speculative decoding is slower than target-only decoding. Its findings are a reason to tune for the actual workload, not to assume that a longer lookahead is better.

One production-engine study summarized on the Hugging Face Papers page, Speculative Decoding: Performance or Illusion?, evaluates n-gram, EAGLE/EAGLE-3, draft-model, and multi-token-prediction variants on vLLM. Its summary reports that target verification can dominate execution, acceptance length varies across output positions, requests, and datasets, and measured performance can fall below theoretical upper bounds. Because this is a paper summary page rather than the full primary paper, treat those observations as qualified evidence, not a universal benchmark result.

As the NAACL paper puts it, “As long as more than one token is accepted on average, speculative decoding can potentially provide speedups.” The word potentially matters: accepted-token count alone does not include draft and verification latency.

What the coding-specific experiment shows

An independent GitHub experiment using Qwen2.5-Coder-Instruct models from 0.5B to 7B compared HumanEval code prompts with Dolly open-QA prose prompts. It reports code acceptance of about 0.97 and prose acceptance of about 0.70–0.81 in its setup. For one tested 1.5B-to-3B code configuration, it reports a measured lookahead optimum of three. These are author-reported results from that experiment, whose publication year is not stated; they are not an independently replicated or peer-reviewed estimate. The result suggests that a draft can agree more often on code than on prose for a particular model pair and prompt set. It does not establish that code generally has higher acceptance, that three is the right lookahead for another deployment, or that a coding agent will complete tasks faster. The same project reports lower agreement and slower performance in one cross-family draft configuration using a text bridge. That observation points to compatibility as a factor in that implementation; it does not establish a universal requirement for all speculative methods.

Why token-generation gains may not speed up a coding task

A coding agent does more than generate a completion. Depending on the product and workflow, the user-visible task may also involve prompt construction, tool calls, code execution, retries, and review. A faster decoding path can improve only the portions of elapsed time it affects. The reviewed evidence does not establish end-to-end task gains for commercial coding agents, or which named products use speculative decoding or enable it for all users. Do not infer a product’s implementation or task-level speedup from model research alone.

How to evaluate it for a coding workload

Compare the deployed paths on the same target model, hardware, software version, workload, batch, and decoding settings. Record the variables that determine whether saved target steps translate into useful performance:

  • Useful output performance: measure end-to-end decode latency and useful tokens per second, not proposals or acceptance in isolation.
  • Draft overhead: measure draft-step latency and memory use, including whether the draft can coexist with the target on the available hardware.
  • Acceptance behavior: record accepted tokens per verification step and how it varies across code tasks, prompts, and output positions.
  • Serving conditions: keep batch size, concurrency, cache behavior, prompt and output lengths, and engine configuration aligned between comparisons.
  • Operational fit: check model-pair compatibility, configuration effort, monitoring needs, and whether the system can fall back to target-only decoding.

Test representative coding prompts and task flows rather than extrapolating from a single benchmark. Include prose or tool-oriented prompts if they are part of the agent’s real workload, since the independent experiment found different acceptance for its code and prose sets. The online-learning method described in the ICML 2026 paper When Drafts Evolve: Speculative Decoding Meets Online Learning uses verification feedback to inform draft improvement; it is a research direction, not evidence that a particular deployed coding agent uses that approach.

Verdict: treat it as an inference optimization to measure

Speculative decoding is a draft-and-verify alternative to sequential target-only generation. Its rejection-sampling form can retain the target output distribution, while its speed advantage remains conditional on draft latency, verification cost, acceptance, workload, hardware, and serving configuration. The coding-specific evidence is promising but narrow: it supports testing the actual model pair and coding workload, not promising a general speedup or attributing the technique to a named product.
