Pandas vs. Polars: Performance, Memory Use, and Which to Choose

pandas and Polars have different strengths, but neither is always faster or smaller. Compare their execution models, memory accounting, migration risks, and a fair way to benchmark your workload.

There is no universal winner between pandas and Polars. pandas is a strong default when its broad feature set, ecosystem, and existing code suit the job. Polars is worth evaluating for column-oriented transformations that could benefit from multithreaded execution, lazy query optimization, or streaming on supported inputs. The useful comparison is your own workload—not a blanket speed or memory ratio.

How pandas and Polars differ

Area pandas Polars What to evaluate
Execution Primarily an eager DataFrame workflow, with targeted performance enhancements documented by pandas. Offers eager and lazy APIs; lazy execution lets the engine optimize a query plan. End-to-end runtime, including input loading and any conversions the application needs.
Parallel work Polars characterizes pandas’ core as largely single-threaded, although some operations and external approaches can use parallelism. Designed for multithreaded processing on a single machine. Actual CPU use and runtime for your mix of operations.
Memory Reported usage depends on dtypes; ordinary reporting can undercount Python objects in object columns. Uses an Arrow-based columnar representation, but real usage depends on schema, operations, and materialization. Peak process memory across the pipeline, not just the final DataFrame’s reported size.
Large or out-of-core work An in-memory analytics tool; chunking or another library may be appropriate when data exceeds available memory. Lazy scans and streaming can support larger-than-memory work for supported sources and operations. Whether the source and operators you use are supported and whether the plan actually streams.
API and migration Index alignment, ecosystem breadth, and familiar APIs can be valuable in existing projects. Emphasizes expressions and differs in index model and type behavior, which can require code changes. Result equivalence, edge cases, and integration with downstream code.

These distinctions describe design and capabilities, not a guarantee that one library will be faster or smaller for every query. Polars’ comparison of pandas and Polars presents pandas as widely adopted and feature-rich, and Polars as optimized for multithreaded processing on one machine.

Is Polars faster than pandas?

It can be, particularly when a workload benefits from parallel execution or when a lazy query plan can be optimized as a whole. But performance depends on the operation mix, data and schema, hardware, software versions, and how the code is written. A result from one synthetic dataset does not establish a general ranking.

The available comparison material does not establish a named, dated speedup that applies across workloads. Avoid claims that Polars is a fixed percentage faster. Instead, benchmark the operations your application actually runs.

Build a representative benchmark

  1. Choose the real workload. Include the operations that matter in production—such as reading files, filtering, joining, grouping, string or datetime processing, and writing results—rather than timing an isolated operation that does not reflect the application.
  2. Use equivalent inputs and results. Keep the same source files and schemas, and confirm that each implementation produces results with the same meaning, including relevant null and type behavior.
  3. Keep conditions consistent. Record hardware, operating system, thread settings, cache conditions, library versions, and input size. Include load, conversion, and output time wherever those costs occur in production.
  4. Measure more than elapsed time. Track end-to-end runtime and peak process memory. Run repeated trials to identify noise, and report the setup alongside results.

pandas warns that benchmark results are not deterministic and can change with hardware and system stress; see its benchmark guidance. Include the pandas and Polars versions in any result you publish, and check the projects’ documentation for current releases when setting up a reproducible comparison.

Which library uses less memory?

There is no reliable library-wide memory winner established here. An Arrow-based layout is an architectural distinction, not proof that Polars will use less memory for a particular pipeline. Data types, operations, intermediate copies, and materialization all affect the result.

Measure pandas memory accurately

When a pandas DataFrame contains Python objects, its ordinary memory report may not include the memory occupied by the objects’ values. The pandas FAQ explains that the true usage can be higher for columns with dtype=object. Use memory_usage(deep=True) to account for object data more accurately; see the pandas DataFrame memory usage guidance.

For pandas pipelines, inspect dtypes, read only needed columns, and consider efficient types such as categoricals for low-cardinality text. pandas also notes that some operations create intermediate copies, so a job’s peak memory can exceed the size of its final DataFrame. Its scaling guide discusses these approaches and chunking.

Compare peak usage, not just the final frame

Measure the whole process consistently in both implementations. Account for input buffers, temporary arrays, joins, conversions, and output buffers. A final DataFrame’s reported size is not the same as the peak memory required to produce it.

When should you choose pandas?

  • Your existing code, dependencies, or downstream tools already use pandas, and the workload performs adequately.
  • You value its broad adoption, feature set, established ecosystem, or team familiarity.
  • You can address the workload with practical changes such as selecting fewer columns, choosing efficient dtypes, or processing data in chunks.
  • A migration would add semantic or integration risk without a demonstrated benefit in your representative benchmark.

When should you choose Polars?

  • Your workload is dominated by column-oriented transformations and could benefit from multithreaded execution on one machine.
  • You can express work through the lazy API and benefit from optimizing a complete query plan.
  • You need to process data larger than memory and have verified that your data source and operations support the streaming path you intend to use.
  • You are starting a project where its expression-based API and ecosystem fit the requirements better than pandas.

Polars’ lazy API guide describes query optimization and streaming for larger-than-memory workloads, subject to supported sources and operations. Check those constraints against your specific pipeline rather than assuming that every lazy query streams.

What should you check before migrating?

Switching libraries is a behavioral change as well as a performance decision. Polars documents differences involving indexes, expressions, dtype strictness, parallel operations, and query engines in its pandas migration guide.

  • Check null handling, mixed-type columns, and implicit casts against the application’s expectations.
  • Review code that relies on pandas index alignment; Polars has a different index model.
  • Confirm that downstream libraries, serialization, and interfaces accept the data structures and types you plan to use.
  • Validate results on representative edge cases before replacing production code.

For reproducibility, pandas documentation identifies version 3.0.6, dated September 17, 2026. The Polars documentation referenced here does not establish a specific release number. Record the actual versions installed in your environment when comparing results.
