To train a language model on raw bytes, encode each text example as a consistent byte stream—usually UTF-8—and feed the resulting byte IDs to the model instead of converting text into learned subword tokens. The model then learns patterns over bytes. The main trade-off is sequence length: bytes remove the need for a large subword vocabulary, but a text passage usually takes more positions to represent. For a practical starting point, reproduce a documented byte-level model such as ByT5; choose learned chunking or retrofitting an existing model when efficiency or reuse of a checkpoint matters more than a clean baseline.
What does it mean to process raw bytes?
A text-processing model normally receives a sequence of IDs. A subword tokenizer maps text into units such as word pieces; a byte-level model instead maps the text’s encoded bytes to IDs. In the common UTF-8 setup, each byte has a value from 0 through 255, so the model can use 256 byte embeddings rather than an input embedding for every item in a large learned vocabulary. ByT5 describes this representation in its 2021 paper.

“Raw bytes” does not mean that the network receives unstructured text without a conversion step. You still need a deterministic encoding, an agreed mapping from byte values to IDs, and consistent handling of boundaries and special markers. The key difference is that the input units are bytes, not word pieces chosen by a tokenizer.

Byte-level input can represent unusual strings without needing a tokenizer to have learned a dedicated piece for each one. That can be useful for noisy spelling, rare names, or character-sensitive tasks. It does not automatically make those tasks easy: the model still has to learn useful patterns from examples, and a byte stream can be much longer than its subword equivalent.
Choose a training route before building the model
There are three distinct approaches in the published work: train a byte-level model directly, learn compact chunks from byte input, or adapt a model that already operates on subwords. They address different goals and should not be treated as interchangeable recipes.
| Route | What it does | Best fit | Important qualification |
|---|---|---|---|
| Direct byte-level training | Feeds byte IDs to the model and trains it on a task objective. ByT5 is an encoder-decoder example using span corruption. | A clean byte-level baseline or a text-to-text task setup. | ByT5’s architecture and numeric choices document one experiment, not universally optimal settings. |
| Learned chunking | Learns latent, subword-like blocks from byte input to reduce effective sequence length. Charformer uses a gradient-based subword tokenization module. | Byte input when sequence efficiency is a central concern. | Reported results apply to Charformer’s tested models and comparisons, not automatically to a new setup. |
| Retrofitting (byteification) | Trains local components to recover an existing subword model’s behavior, then fine-tunes the whole model to use byte-level information. | Adapting an existing checkpoint rather than pretraining a byte model from random initialization. | The 2026 Nature paper describes a particular two-stage method; it is not a universal conversion procedure. |
If the immediate aim is to understand the costs and behavior of byte inputs, begin with a direct baseline. If the baseline is constrained by longer sequences, investigate learned chunking. If you have a capable subword checkpoint whose behavior you want to retain, study byteification as a separate conversion project.

Build a direct byte-level baseline with ByT5
ByT5 is a documented encoder-decoder approach for NLP tasks framed as text-to-text. It adapts T5 to consume and generate UTF-8 byte sequences and trains with span corruption. The authors state that a standard Transformer can be modified only minimally to process bytes; that statement describes their model family, not a guarantee that every existing Transformer implementation will work unchanged.
Prepare examples consistently
- Choose the text encoding. Use UTF-8 if following the ByT5 example, and apply the same encoding during training, validation, inference, and output reconstruction.
- Define the model’s input IDs. Map the 256 possible byte values consistently to embedding IDs. If the task uses extra structural or sentinel markers, define their IDs and behavior separately; do not confuse them with UTF-8 bytes.
- Keep the bytes in order. Convert a complete text example to bytes before assigning IDs. Avoid character-by-character transformations that change the underlying byte sequence.
- Specify the task target. For text-to-text work, define how inputs and targets are encoded and reconstructed. ByT5’s documented objective corrupts spans and trains the model to produce the corresponding target text.
- Validate the pipeline on small examples. Confirm that encoding then decoding an ordinary string reproduces it, that multibyte characters remain intact, and that special markers are handled as intended.
Understand what the ByT5 settings mean
In the paper’s illustration, spans of about 20 bytes are masked, and the encoder is three times deeper than the decoder. Those are choices from the authors’ setup, not recommended defaults for all datasets, model sizes, or tasks. The paper also compares parameter count, FLOPs, and inference speed, underscoring that parameter count alone does not capture byte-model cost.
The authors report that their byte-level models are competitive with token-level counterparts, robust to noise, and useful on spelling- and pronunciation-sensitive tasks. Treat those as findings from their evaluated models and workloads—not a promise that a byte model will outperform a subword model on your own data. The official ByT5 repository README identifies the project as a tokenizer-free extension of mT5 and describes a training entry point for reproducing ByT5-Large on the mC4 task. The repository page says it was archived on April 19, 2026; it remains a reproducibility reference, but that archive status does not establish active maintenance.

Account for the sequence-length cost
The most consequential practical difference is often the number of positions needed to represent the same text. A subword model can encode a word or part of a word in one position; UTF-8 may need several byte positions. Longer sequences can consume more context and raise training or inference costs, especially when attention has to operate across many positions.
Recommended Free Tools
In ByT5’s reported comparison, with sequence length 1024 and fixed hardware, the authors measured about 1.2 times more pretraining operations and about 0.75 times as many sequences per second. These figures describe that comparison only; they are not universal multipliers for byte models, different sequence lengths, or other hardware. Measure your own workload rather than projecting those numbers onto it.
- Check effective context. Compare examples in bytes and in subword tokens. A nominally identical context window may cover less text when each byte takes a position.
- Measure throughput. Record examples or sequences per second under stated hardware, batch, and length settings. Include the amount of original text processed so shorter examples do not make throughput comparisons misleading.
- Track compute as well as parameters. Matching parameter counts does not mean two models process equal amounts of input or require equal compute.
- Watch truncation and padding. A byte sequence that exceeds the chosen context may lose more source text than expected. Report how examples are truncated, split, or batched.
Use learned chunking when direct byte sequences are too costly
Charformer offers a way to start from byte-level input while learning more compact internal groupings. Its gradient-based subword tokenization module scores candidate byte blocks and learns latent subword representations from data. In practical terms, it lets the model discover useful chunks rather than requiring a fixed learned tokenizer to define every input unit in advance.

The Charformer authors report competitive results on English GLUE, multilingual, and noisy-text experiments. They also report a 28%–100% speed improvement over the vanilla byte-level and subword Transformers tested in that work. The range is specific to those models and baselines; it should not be used as a general forecast for an implementation with different data, hardware, or architecture. See the Charformer paper for the method and evaluation scope.
Choose this route when you want byte-level access to input but need the model to reduce the effective sequence length. It adds architectural and training complexity compared with a direct baseline. For a fair decision, compare task quality and throughput under the same data and evaluation conditions, and include the added implementation complexity in the choice.
Consider byteifying an existing subword model
Byteification is not the same as training a byte model from scratch. The 2026 Nature paper describes a two-stage approach to adapting an existing subword language model.
Best Value
- Recover the source model’s behavior locally. Train local encoder/decoder components, a boundary predictor, and a language-modeling head to reproduce the behavior of the existing model while its global model remains frozen.
- Train the full model end-to-end. Unfreeze and train the model so it can use byte-level information, with the method also allowing an increase in the target bytes-per-patch ratio.
The authors evaluated byteified variants of Qwen3 8B, Llama 3 8B, and Olmo 3 7B, and report that the adapted models approached their source models on several evaluations. This is evidence for that method and those evaluations, not evidence that any checkpoint can be converted with no quality loss. The paper says its training code is available in AllenAI’s bolmo-core repository; its account of the method is at Nature.
Choose this route when retaining an existing model’s learned behavior is part of the goal and you can implement a staged adaptation. Do not follow the ByT5 recipe as if it were a byteification procedure: the starting point and training objective differ.
How should you evaluate a byte model?
Compare against a reasonable subword baseline on the same data and evaluation conditions. A byte model may have different input lengths and compute requirements, so a single score or parameter count cannot establish which design is better for your application.
Do these 3 things before closing this tab:
1Clear out junk files and repair common Windows errors2Fix the driver behind crashes, sound loss and screen glitches3Repair Windows errors before they cause bigger problems| What to compare | How to make the comparison useful |
|---|---|
| Task quality | Use the same task data, splits, and evaluation method. Compare quality at matched data and parameter or compute budgets, and state which budget you matched. |
| Training cost and throughput | Record FLOPs where available and wall-clock throughput under specified hardware and sequence settings. |
| Effective context | Measure bytes and subword tokens for representative inputs, then check how much original text fits and how often examples are truncated. |
| Robustness | Test the spelling noise, unusual strings, or malformed inputs that matter to your application rather than relying on general claims about byte-level robustness. |
| Language and character sensitivity | Include the languages and character-sensitive tasks you expect to support. Multilingual results from one study do not settle performance for every language or dataset. |
| Implementation burden | Account for preprocessing, decoding, architecture changes, checkpoint adaptation, and the time needed to validate the pipeline. |
State the evaluation scope alongside every result: data, model configuration, sequence settings, compute or hardware conditions, and whether the model was trained from scratch or adapted. Without those details, apparent wins can reflect a difference in the workload or budget rather than an advantage in byte processing itself.
What recent byte-model results do—and do not—show
An October 5, 2026 arXiv preprint studies byte Transformers without specialized tokenization architectures. It reports better scaling behavior with token-superposition training and hash embeddings, and finds that learned local structures can act like segmentation positions. The authors also report that speculative decoding based on those structures yields 3.4 times more accepted tokens than in their subword Transformer comparison. This is a newly submitted preprint result, not settled consensus or a general speed claim for byte models. Its experimental scope is described in the preprint.
These results point to an active design question: whether byte models can learn useful local structure without relying on a conventional tokenizer, and how to do so efficiently. For a training decision today, treat the preprint as a research direction. Use measured results from your own task and the more directly documented baselines to decide whether a method fits your constraints.
Quick Recap
Common implementation mistakes
- Mixing encodings: using different encodings or conversion rules between training and inference changes the model’s input representation. Fix one encoding and test the full round trip.
- Treating bytes as characters: individual UTF-8 bytes are not necessarily valid standalone characters. Preserve the sequence and decode the assembled output.
- Copying paper settings as universal defaults: ByT5’s span size, encoder/decoder balance, and sequence-length comparison are experimental choices, not guarantees for another task.
- Ignoring longer inputs: compare context coverage and throughput, not only task scores or parameter counts.
- Confusing training routes: direct byte pretraining, learned chunking, and byteifying an existing checkpoint have different starting points and objectives.
- Generalizing benchmark wins: a speed or quality result belongs to the models, data, and baselines tested. Reproduce the conditions as closely as possible before treating it as a planning assumption.
Which route should you choose?
- Choose direct byte training when you need a clean baseline and a documented text-to-text example. ByT5 provides an encoder-decoder reference, not a complete decoder-only training recipe.
- Choose learned chunking when preserving byte input matters but long sequences make direct processing inefficient. Charformer is a published example, with results tied to its tested configurations.
- Choose byteification when starting from an existing subword model is essential and you can undertake the staged adaptation described by the Nature study.
- Do not assume a decoder-only recipe is established here. A causal decoder would ordinarily predict the next byte, but the cited sources do not provide a complete, tested from-scratch configuration covering corpus filtering, optimizer schedule, context length, batching, and compute budget.
