Reduce AI inference costs by first cutting unnecessary requests and tokens, then testing caching, smaller-model routing, and batch processing against real tasks. Keep an optimization only if it lowers cost per acceptable result while meeting your quality, latency, and reliability requirements.
Measure cost and quality before changing the system
Start with a representative set of production-like inputs. Record the current answer quality, end-to-end latency, and total spend for completed tasks. OpenAI recommends evaluating models on representative real-world inputs and iterating from feedback in its model optimization guide.

Track more than a model’s listed token price. For each user task, capture the model used, input and output tokens, number of requests, retries, cache reads and writes, latency, and whether the result met your acceptance criteria. Calculate cost per accepted task; failed answers, repeated context, and retries can make the effective cost very different from a simple token-price comparison. OpenAI also recommends tracking cached tokens, cache writes, input tokens, latency, and realized cost when assessing prompt caching (prompt caching guide).
Define what counts as an acceptable result
Choose quality checks that reflect the task: for example, factual correctness, required fields, successful tool use, or a human review score. Compare candidate changes against the same inputs and criteria. A cheaper response is not a saving if it increases errors, escalations, or repeat requests enough to raise cost per successful outcome.

Cut avoidable requests and tokens first
Removing wasted work is usually a safer first step than reducing answer quality. OpenAI’s cost optimization guide recommends reducing unnecessary requests, input tokens, and output length.
- Remove duplicate calls and prevent retries that are not needed.
- Ask for only the output the task requires; avoid unnecessary verbosity.
- Trim irrelevant history or context, while retaining information needed for correctness.
- Combine steps only when one call can reliably perform them; splitting work into multiple calls can add both latency and cost.
After each change, rerun the evaluation set. Shorter prompts and answers can lower usage, but excessive trimming may reduce accuracy or omit useful details.
Reuse stable prompt prefixes with caching
Caching can reduce repeated processing of shared instructions or context, but it depends on the provider, model, and request pattern. In OpenAI’s prompt caching guidance, cache reuse requires the entire rendered prefix to match. Put stable instructions, schemas, and tool definitions before content that changes between requests; a change earlier in the prefix can prevent later content from matching the cached prefix.

Measure cache hits, cached-token use, cache writes, and billed cost rather than assuming that a cache is helping. Caching is most relevant when requests repeatedly share a substantial prefix; it may contribute little when each prompt is mostly unique. Consult the provider’s current cache rules and supported-model details before changing request construction.
Route suitable tasks to smaller models
A smaller or cheaper model can lower inference spend, but it should be treated as an evaluated routing choice, not a universal replacement. Test candidate models on the same representative inputs and compare quality, latency, and cost per accepted task. OpenAI’s cost guidance and Anthropic’s cost and intelligence guidance both frame model choice around the task and completed-work cost, not token price alone.
One practical pattern is to send straightforward, low-risk work to a less expensive model and reserve a stronger model for difficult or consequential requests. Add an escalation or fallback path for uncertainty, failed checks, or cases where the first model does not meet the quality bar. Routing features, such as AWS Bedrock’s intelligent routing, are provider-specific capabilities—not a guarantee that routing will improve every workload (AWS Bedrock cost optimization).

Batch work that does not need an immediate answer
Move queued or offline tasks—such as enrichment, evaluations, and scheduled reports—to asynchronous batch or flexible processing when their completion terms fit your deadlines. OpenAI describes its Batch API as asynchronous and its flex processing as lower cost in exchange for slower responses and occasional resource unavailability (OpenAI cost optimization).

Include the expected wait, availability, and recovery behavior in the comparison, not just the potential price reduction.
Consider fine-tuning or distillation only for stable, repeated tasks
Training a smaller model through fine-tuning or distillation may reduce repeated inference expense or allow shorter prompts when a high-volume task is stable and well-scoped. It also adds work: preparing suitable training data, evaluating the result, and maintaining the model and process. Compare those costs with expected inference savings before proceeding.

Availability is not universal. OpenAI’s current model optimization guide says its fine-tuning platform is winding down for new users. AWS describes model distillation in Bedrock and publishes vendor-reported performance claims, which should be tested on the target workload rather than assumed to transfer (AWS Bedrock cost optimization).

- Quality on representative tasks and the rate of acceptable results.
- Total cost per accepted task, including output, retries, and repeated context.
- Latency against real user expectations or job deadlines.

There is no universally cheapest optimization: results depend on request shape, repeated context, output length, timing needs, and the quality bar. Provider prices, model features, cache rules, and batch terms can change; check current documentation before making implementation or budget decisions.

What published savings figures do—and do not—show
Published results can suggest which approaches to test, but they are not promises for a different workload. The FrugalGPT paper authors reported up to 98% cost reduction while matching the performance of the best individual model in their 2023 experiments, and a 4% accuracy improvement over GPT-4 at the same cost in an experiment-specific result (FrugalGPT paper).
Anthropic reports that prompt caching reduced agent-loop cost by 2.7 to 5.3 times on its described benchmarks, and that caching cut a small triage agent’s bill by 83%, or 88% with input trimming. Those are Anthropic’s measurements, not a general forecast for other systems (Anthropic cost guide). AWS advertises savings of up to 90% in cost and 85% in latency for prompt caching on supported models, and up to 30% savings from intelligent routing without compromising accuracy; eligibility and outcomes depend on supported models and workload (AWS Bedrock cost optimization).
